Abstract:Accurate load prediction is a prerequisite for the design, operation, scheduling, and management of energy systems. In the context of the development of smart grids, the extensive integration of highly volatile distributed energy generation into the power system has brought new challenges to the accuracy, reliability, real-time performance, and intelligence of short-term load forecasting. Therefore, this article proposes a novel short-term power load composite prediction model based on AM–CNN–Bi–LSTM. First, CNN is used to extract relevant feature quantities of power load coupling characteristics. Then, AM is used to evaluate the importance of the feature data, highlighting the features that have a greater impact on the prediction results. Finally, the Bi-LSTM network captures bidirectional temporal information from multiple time steps for prediction. Taking one year of measured data as an example, the error comparison of the prediction results of the composite prediction model overlay shows that compared with other models, the composite prediction model has improved prediction accuracy, feature extraction, generalization ability, and other aspects. The research results improve the accuracy of short-term power load forecasting while providing effective model references for decision-making in power system optimization scheduling, safe operation, and reasonable pricing.

Abstract:Accurate power load forecasting is crucial for the sustainable operation of smart grids. However, the complexity and uncertainty of load, along with the large-scale and high-dimensional energy information, present challenges in handling intricate dynamic features and long-term dependencies. This paper proposes a computational approach to address these challenges in short-term power load forecasting and energy information management, with the goal of accurately predicting future load demand. The study introduces a hybrid method that combines multiple deep learning models, the Gated Recurrent Unit (GRU) is employed to capture long-term dependencies in time series data, while the Temporal Convolutional Network (TCN) efficiently learns patterns and features in load data. Additionally, the attention mechanism is incorporated to automatically focus on the input components most relevant to the load prediction task, further enhancing model performance. According to the experimental evaluation conducted on four public datasets, including GEFCom2014, the proposed algorithm outperforms the baseline models on various metrics such as prediction accuracy, efficiency, and stability. Notably, on the GEFCom2014 dataset, FLOP is reduced by over 48.8%, inference time is shortened by more than 46.7%, and MAPE is improved by 39%. The proposed method significantly enhances the reliability, stability, and cost-effectiveness of smart grids, which facilitates risk assessment optimization and operational planning under the context of information management for smart grid systems.

Abstract:With the widespread adoption of electric vehicles (EVs), their charging and discharging schedules pose new challenges for real-time load forecasting in commercial buildings. This study proposes a prediction model based on the integration of bidirectional long short-term memory (BiLSTM) networks and Transformer architecture, along with the introduction of a cognitive control system and cyber–physical systems (CPS) to address issues such as data loss and excessive computation time during the forecasting process. The BiLSTM–Transformer model significantly improves load-forecasting accuracy and real-time performance by combining time-series modeling with global feature extraction capabilities. Additionally, the cognitive control system includes user-aware cognitive control (UACC) and Microgrid Control Center Cognitive Control (MACC). UACC quantifies information gaps in real time and adaptively adjusts strategies during communication instability, while MACC employs Q-learning algorithms to evaluate the impact of data loss on scheduling and optimize power resource allocation. The synergy between these mechanisms ensures system stability and predictive performance in scenarios involving data loss or communication disruptions. Experimental results demonstrate that the model achieves outstanding predictive accuracy under complete data conditions and significantly reduces errors in scenarios with data loss, validating its superior accuracy and robustness. This provides reliable support for load forecasting in commercial buildings.

Abstract:The management of electricity systems benefits considerably from short-term load forecasting. Although various superior short-term prediction algorithms have been investigated, some problems are still encountered in practical applications: (1) When dealing with data containing noise, there are unpredictable effects on short-term load forecasting. (2) Current deep learning models are time-consuming. In this study, we suggest an ensemble kernel broad learning system based on residuals to resolve the aforementioned issues. Specifically, we merge the broad learning system with kernel learning, which helps obtain stable features to improve the performance and avoid getting into the non-optimal problem. In addition, to further improve the prediction accuracy, we fuse multiple base learners to obtain an optimal prediction model from the residuals of the loss function. The experimental findings exhibit the efficacy and efficiency of our suggested technique.

Abstract:The development of smart grids requires enhanced data integration, robust risk assessment, and dynamic response optimization. In this paper, a multi-core learning Support Vector Machine (SVM) model is presented to improve the accuracy and efficiency of load and photovoltaic output forecasting. The model leverages kernel function optimization and parallel computing frameworks to handle large-scale data efficiently. Additionally, a comprehensive risk assessment system is developed to quantify risks such as overvoltage, undervoltage, line overload, and load loss in distribution networks. An adaptive genetic algorithm-based risk control model is also proposed, optimized in two stages—day-ahead and intra-day—to achieve minimal comprehensive risk through real-time adjustments in distributed power output and electric vehicle charging strategies. Furthermore, an integrated virtual synchronous control online verification method for source-network-load-storage is introduced, enhancing system response speed and control accuracy. These innovations collectively provide a solid theoretical foundation and technical support for the efficient and safe operation of smart grids, addressing the increasing demands of modern energy systems.

Abstract:Aiming at the unreliability of historical data for short-term load forecasting caused by the sudden change of power grid load under emergencies, a short-term load prediction method adopting transfer learning is studied. The proposed transfer learning method combines the attention mechanism (AM) with the long short-term memory network coupled with input and forgetting gates (CIF-LSTM) to construct the AM-CIF-LSTM short-term load prediction model. First, the variational modal decomposition (VMD) method is used to extract the trend component and certain periodic high-frequency components of the load datasets of the scene to be predicted and similar scenes. Subsequently, the AM-encoder/decoder learning model is established based on the trend component, and the AM learnable parameters are trained and transferred to the AM-CIF-LSTM model. Furthermore, inspired by the idea of classified forecasting, the load trend component and periodic high-frequency components under the required prediction scene are predicted by AM-CIF-LSTM and deep recursive neural network (DRNN), respectively. Finally, the load forecasting results are superimposed to obtain the load forecasting value. The experimental results demonstrate that the proposed method outperformed the existing methods in multiple accuracy indicators and could predict the rapid change trend of load in the case of insufficient data accurately and stably.

Abstract:In the integrated energy system with small samples, insufficient data limits the accuracy of energy load forecasting and thereafter affects the system's economic operation and optimal dispatch. For this specific environment, this paper proposes a multi-energy load forecasting method based on the neural network model and transfer learning to meet the demand of enterprises for forecasting accuracy. The method improves forecasting accuracy through three stages including data analysis and processing, a combined model built and load forecasting. More specifically, the Pearson correlation coefficient is used to filter out meteorological variables with strong correlation based on energy load and meteorological data. A combined model is developed based on the convolutional neural network and gated recurrent unit. A model structure adjustment strategy based on the maximum mean difference is proposed to dynamize the structure to cope with the complex prediction environment. The synergy between source and target domain data is realized based on transfer learning. In addition, the model performance is further optimized through model training, transfer learning, and parameter fine-tuning, which lays the foundation for improving the forecasting accuracy of electricity, gas, cooling, and heating loads. The simulation results show that the proposed method can achieve satisfactory predictions for integrated energy systems with small sample data.

Abstract:Accurate load forecasting plays an important role in promoting low-carbon energy and high-quality utilization of electricity, as well as carbon reduction and safety in energy and power systems. The complexity of power system trends leads to widespread uncertainty in load forecasting. This article analyzes the internal mechanisms of load and meteorological factors at the level of multidimensional uncertainty and proposes a bidirectional memory feature hybrid model based on a new intelligent optimization method. The VMD optimized by grey wolf decomposes the electricity load data into different information modal components. The decomposed components are statistically analyzed with multidimensional uncertainty analysis to extract statistical patterns. The GTO part is optimized according to the fitness value to update the population and global optimal solution. Furthermore, convolutional neural networks (CNN) are used to extract potential features from load and meteorological data and enhance the correlation between input and output data. Then, short-term load forecasting is realized by using bi-directional short-term memory neural network (BiLSTM). The results show that the proposed model has smaller errors than several commonly used models, and has higher prediction accuracy. It can provide some new ideas for relevant departments to carry out power economic dispatch work in low-carbon modes.

Abstract:In the era of dual carbon, the rapid development of various types of microgrid parks featuring multi-heterogeneous energy coupling presents new challenges in accurately modeling spatial and temporal load characteristics due to increasingly complex source–load characteristics and diversified interaction patterns. This study proposes a short-term load forecasting method for an interconnected park-level integrated energy system using a data center as the case study. By leveraging spatially transferable load characteristics and the heterogeneous energy correlation among electricity–cooling–heat loads, an optimal feature set is selected to effectively characterize the spatial and temporal coupling of multi-heterogeneous loads using Spearman correlation analysis. This optimal feature set is fed into the multi-task learning (MTL) combined with the convolutional neural network (CNN) and long- and short-term memory (LSTM) network model to generate prediction results. The simulation results demonstrate the efficacy of our proposed approach in characterizing the spatial and temporal energy coupling across different parks, enhancing track load "spikes" and achieving superior prediction accuracy.

Abstract:A novel transfer learning method is proposed in this paper to solve the power load forecast problems in the smart grid. Prediction errors of the target tasks can be greatly reduced by utilizing the knowledge transferred from the source tasks. In this work, a source task selection algorithm is developed and the transfer learning model based on Gaussian process is constructed. Negative knowledge transfers are avoided compared with the previous works, and therefore the prediction accuracies are greatly improved. In addition, a fast inference algorithm is developed to accelerate the prediction steps. The results of the experiments with real world data are illustrated.

Abstract:Cyber-physical energy systems, which emerges as the approach for integrating physical layers and control networks, have drawn extensively attention in recent years. Electric load forecasting is believed to be an important issue in CPES for its applications in prices determination and automatic generation control. Conventional deterministic load forecast method have drawbacks to providing information about the probability distribution of the prediction results, which are important for stochastic decision in power systems. This paper explores a hierarchical probabilistic approach for short-term load forecast, which combines sparse Bayesian learning with empirical mode decomposition, in order to obtain a componential forecasting results, as well as the forecasting uncertainty. Mahalanobis distance based similar day weighting is introduced to prune the training data. The numerical testing results illustrate that the proposed approach exhibits better performance in comparison with original SBL model and weighted SBL without componential analysis.

Abstract:The economic operation and scheduling of community integrated energy system (CIES) depend on accurate day-ahead multi-energy load forecasting. Considering the high randomness, obvious seasonality, and strong correlations between the multiple energy demands of CIES, this paper proposes an adaptive forecasting method for diverse loads of CIES based on deep transfer learning. First, a one-dimensional convolutional neural network (1DCNN) is formulated to extract hour-level local features, and the long short-term memory network (LSTM) is constructed to extract day-level coarse-grained features. In particular, an attention mechanism module is introduced to focus on critical load features. Second, a hard-sharing mechanism is adopted to learn the mutual coupling relationship between diverse loads, where the weather information is added to the shared layer as an auxiliary. Furthermore, considering the differences in the degree of uncertainty of multiple loads, dynamic weights are assigned to different tasks to facilitate their simultaneous optimization during training. Finally, a deep transfer learning strategy is constructed in the forecasting model to guarantee its adaptivity in various scenarios, where the maximum mean discrepancy (MMD) is used to measure the gradual deviation of the load properties and the external environment. Simulation experiments on two practical CIES cases show that compared with the four benchmark models, the electrical and heating load forecasting accuracy (measured by MAPE) increased by at least 4.99 and 18.22%, respectively.

Abstract:1Critical interfaces with low safety margin are weakness of power grid need to be focused on. Its accurate prediction is important basis of reasonable scheduling. Taking Guangdong power grid for example, data of electric and non-electric parameters between 2014 and 2015 were collected. Firstly, the parameter data were standardized and integrated. Secondly, whole characteristics were selected and samples were trained with neural network. Then a neural network prediction model for critical interfaces was obtained. Compared to traditional method, this method introduces non-electric parameters. Test on Guangdong power grid shows that this model is accurate, fast and suitable to actual complex and changeable power grid.

Abstract:With the development of Big Data technology, the power industry has also entered the data-driven intelligence era. Cloud computing-based smart grids give the power industry stronger capabilities in data analytics. Electricity load forecasting in the cloud helps smart grids allocate resources appropriately. However, the users' privacy is easily compromised in the load forecasting process with cloud computing. The electricity usage data collected by the system may contain sensitive information about the users, which could lead to serious privacy leakage. In order to solve the issues, we propose a novel privacy-preserving cloud-aided load forecasting scheme for the cloud computing-based smart grid. It contains a secure online training algorithm and an efficient real-time forecasting algorithm. Meanwhile, the two-party interaction security scheme is more suitable for real-world applications. Before being sent to the cloud server, the control center of the smart grids encrypts the data using homomorphic encryption. During the process of model training and forecasting, the data remains securely encrypted at all times to avoid the risk of data privacy breaches. Finally, security and experimental analyses show that our scheme effectively avoids privacy leakage while reducing resource consumption.

Abstract:The scheduling and operation of power system becomes prominently complex and uncertain, especially with the penetration of distributed power. Load forecasting matters to the effective operation of power system. This paper proposes a novel deep learning framework to forecast the short-term grid load. First, the load data is processed by Box-Cox transformation, and two parameters (electricity price and temperature) are investigated. Then, to quantify the tail-dependence of power load on the two parameters, parametric Copula models are fitted and the threshold of peak load are computed. Next, a deep belief network is built to forecast the hourly load of the power grid. One year grid load data collected from an urbanized area in Texas, United States is utilized in the case studies. Short-term load forecasting are examined in four seasons independently. Day-ahead and week-ahead load forecasting experiments are conducted in each season using the proposed framework. The proposed framework is compared with classical neural networks, support vector regression machine, extreme learning machine, and classical deep belief networks. The load forecasting performances are assessed by mean absolute percentage error, root mean square error, and hit rate. Computational results confirm the effectiveness of the proposed data-driven deep learning framework. The prediction accuracies of both day-ahead forecasting and week-ahead forecasting demonstrate that the proposed framework outperforms the tested algorithms.

Abstract:Due to the dynamic nature of grid environments, schedule algorithms always need assistance of a long-time-ahead load prediction to make decisions on how to use grid resources efficiently. In this paper, we present and evaluate a new hybrid model, which predicts the n-step-ahead load status by using interval values. This model integrates autoregressive (AR) model with confidence interval estimations to forecast the future load of a system. Meanwhile, two filtering technologies from signal processing field are also introduced into this model to eliminate data noise and enhance prediction accuracy. The results of experiments conducted on a real grid environment demonstrate that this new model is more capable of predicting n-step-ahead load in a computational grid than previous works. The proposed hybrid model performs well on prediction advance time for up to 50 minutes, with significant less prediction errors than conventional AR model. It also achieves an interval length acceptable for task scheduler.
A hybrid transfer learning model for short-term electric load forecasting

Abstract:Transfer learning approach can be applied to electric load forecasting because electric load data from nearby locations are significantly correlated. However, ordinary transfer learning methods may bring negative transfer into load forecasting as time series prediction is not exactly the same as traditional data regression problem. Consequently, this paper proposes a novel hybrid transfer learning model based on time series decomposition. Firstly, trend and seasonal components are handled by standard machine learning approach so that seasonal cycles of electric load data can be interpreted better. Secondly, two-stage transfer regression model is established to forecast the irregular component in order to improve the forecasting accuracy. The negative transfer is successfully avoided, and the prediction accuracies are significantly improved because of time series decomposing and the additional information provided by the related dataset. The case study presented by two real-world power load datasets illustrates that the proposed approach can improve electric load prediction for a location by 30% at most by using additional data from another location.

Abstract:Nowadays, data analysis is been the most important means to realize power scheduling in smart grids. However, the sharp increase in business data of grids has posed great challenges for this purpose. To deal with such issue, this paper utilizes deep learning to discover hidden rules from massive large-scale big data and particle swarm optimization (PSO) algorithm for generation of control decision. Therefore, an intelligent scheduling control method for smart grid based on deep learning is proposed in this paper. By modeling the historical data of the power company, the long short-term memory algorithm can effectively extract the effective features and realize the prediction of the coal consumption of the unit under certain conditions. At the same time, a kind of intelligent power scheduling algorithm is designed by using PSO, so as to save energy and reduce emissions as much as possible while fulfilling the real-time power generation task. Experiments on a real-world smart grid dataset show that the proposal can achieve a relatively good performance with respect to intelligent scheduling.

Abstract:With the increasing development of smart grid technology, short-term load forecasting becomes particularly important in power system operation. However, the design of accurate and reliable short-term load forecasting methods and models is challenging due to the volatility and intermittency of renewable energy sources, as well as the privacy and individual characteristics of electricity consumption data from user data. To overcome this issue, in this paper, a novel cloud-edge collaboration short-term load forecasting method is proposed for smart grid. In order to reduce the computational load of edge nodes and improve the accuracy of node prediction, we use the method of building a model pre-training pool to train multiple pre-training models in the cloud layer at the same time. Then we use edge nodes to retrain the pre-trained model, select the optimal model and update the model parameters to achieve short-term load forecasting. To assure the validity of the model and the confidentiality of private data, we utilize the model pre-training pool to minimize edge node training difficulty and employ the approach of secondary edge node training. Finally, extensive experiments confirm the efficacy of our proposed method.

Abstract:Short-term electricity load forecasting is critical and challenging for scheduling operations and production planning in modern power management systems due to stochastic characteristics of electricity load data. Current forecasting models mainly focus on adapting to various load data to improve the accuracy of the forecasting. However, these models ignore the noise and nonstationarity of the load data, resulting in forecasting uncertainty. To address this issue, a short-term load forecasting system is proposed by combining a modified information processing technique, an advanced meta-heuristics algorithm and deep neural networks. The information processing technique utilizes a sliding fuzzy granulation method to remove noise and obtain uncertainty information from load data. Deep neural networks can capture the nonlinear characteristics of load data to obtain forecasting performance gains due to the powerful mapping capability. A novel meta-heuristics algorithm is used to optimize the weighting coefficients to reduce the contingency and improve the stability of the forecasting. Both point forecasting and interval forecasting are utilized for comprehensive forecasting evaluation of future electricity load. Several experiments demonstrate the superiority, effectiveness and stability of the proposed system by comprehensively considering multiple evaluation metrics.
