Abstract:Objective]Object-based classification method provides a new way for classifying remote sensing image of high spatial resolution because it can synthetically use spectral feature,geometric feature,texture feature,and so on. However,increase in the number of features will lead to the emergence of the“dimension disaster”,complicate operation, and decline in speed. It also leads to a decrease in classification accuracy under the limited training samples. In order to solve the problem in the feature space selection during object-based classification,an optimal features selection method based on ReliefF was proposed in this study.[Method]The method gave a weight to each feature according to the separability of features of training samples,and selected the features which are important to samples classification through analyzing the correlation between features. Taking Shanchuan town in Anji County in Zhejiang Province as the study area, 370 object samples for eight classes were selected. A total of 42 object features were selected,including mean and standard deviation of normalized difference vegetation index( NDVI) ,each band of SPOT5 image and their gray level co-occurrence matrix textures( GLCM) . Based on the optimal features selected from the 42 object features using the ReliefF algorithm,nearest neighbor algorithm in object-based classification method was used to extract the distribution of the bamboo forest in the study area. Moso bamboo forest information extracted by object-based classification based on optimal features was compared with the results from classification and regression tree ( CART ) decision tree algorithm in object-based classification method,under the same segmentation parameters and training samples.[Result]1 ) By using the ReliefF algorithm,the classification accuracy of bamboo forest samples has been greatly improved. The accuracy of moso bamboo samples was increased from 68% to 88%. Mean object value of red band as well as green band,mean component of GLCM in red band,entropy component of GLCM in red band,and mean object value of NDVI were the five optimal object features. The user’s and producer’s accuracies achieved 97% and 95%,respectively; 2) Both the user’s and producer’s accuracies of moso bamboo forest were lower when using CART decision tree than those using nearest neighbour( NN) classification based on optimal features,and the main reason was attributed to the serious confusion among moso bamboo forest,deciduous as well as conifer. [Conclusion]ReliefF algorithm focus on the discrimination ability of features,and using the features selected by ReliefF algorithm were prior to other related researches,which gave insight into the object-based classification of forest resources in the remotely sensed technique.

Abstract:This study proposed a multi-scale, object-based classification analysis of SPOT-5 imagery to map Moso bamboo forest. A three-level hierarchical network of image objects was developed through multi-scale segmentation. By combining spectral and textural properties, both the classification tree and nearest neighbour classifiers were used to classify the image objects at Level 2 in the three-level object hierarchy. The feature selection results showed that most of the object features were related to the spectral properties for both the classification tree and nearest neighbour classifiers. Contextual information characterized by the composition of classified image objects using the class-related features assisted the detection of shadow areas at Levels 1 and 3. Better classification results were achieved using the nearest neighbour algorithm, with both the producer’s and user’s accuracy higher than 90% for Moso bamboo and an overall accuracy of over 85%. The object-based approach toward incorporating textural and contextual information in classification sequence at various scales shows promise in the analysis of forest ecosystems of a complex nature.
Mapping Global Bamboo Forest Distribution Using Multisource Remote Sensing Data

Abstract:Bamboo forest has great potential in climate change mitigation. However, the spatiotemporal pattern of carbon storage of global bamboo forest is still cannot be accurately estimated, because the lack of an accurate global bamboo forest distribution information. In this paper, the global bamboo forest distribution was mapped with the following steps. To begin with, training samples were obtained based on investigation data, statistic data, and literature data. Then, a decision tree was constructed for mapping the global bamboo forest distribution by integrating Landsat 8 OLI and MODIS data. Finally, the global bamboo forest area was estimated using a pixel unmixing algorithm. The constructed decision tree succeeds in extracting global bamboo forest based on remote sensing data, where the overall accuracy of classification was 78.81%. The estimated total global bamboo forest area was 30538.35 × 103 ha, with a low root-mean-square error of 611.1 × 103 ha. The estimated bamboo forest area of each province in China and each country were high consistent with the National Forest Inventory in China and Food and Agriculture Organization of the United Nations statistic results (average R2 > 0.9), respectively. Therefore, the global bamboo forest map yielded a satisfactory accuracy in both classification and area estimation, and could provide accurate and significant support for global bamboo forest resource management and carbon cycle research.
Spatiotemporal Estimation Of Bamboo Forest Aboveground Carbon Storage Based On Landsat Data In Zhejiang, China

Abstract:China is one of the countries with the most abundant bamboo forest resources in the world, and Zhejiang province is among the top-3 Chinese provinces with richest bamboo forests. For rational bamboo forests management, it is of great significance to study the spatiotemporal dynamic changes of Aboveground Carbon (AGC) stocks of bamboo forest in Zhejiang. In this study, remote sensing variables, such as spectral, vegetation indices and texture features of bamboo forest in Zhejiang, were extracted from 32 Landsat TM and OLI images got from four different years (2000, 2004, 2008 and 2014). These variables were subsequently selected with stepwise regression method to build an estimation model of AGC of the bamboo forests. The results showed that (1) the accuracy of bamboo forest remote sensing information extracted from the four different years was high with a classification accuracy of >76.26% and an accuracy of users of >91.62%. The classification area of bamboo forest was highly consistent with the area from forest resource inventory, and the area accuracy was over 96.50%; (2) the estimation model performed well in predicting the AGC in Zhejiang for different years. The correlation coefficient for estimated and measured AGC was between 63% and 72% with low root mean square error; (3) the derived AGC of the bamboo forests in Zhejiang province increased gradually from 2000 to 2014, with the AGC density of 6.75 Mgha(-1), 10.95 Mgha(-1), 15.25 Mgha(-1) and 19.07 Mgha(-1) respectively, and the average annual growth of 0.88 Mgha(-1). The spatiotemporal evolution of bamboo forest AGC in Zhejiang province had a close relationship with the gradual expansion of bamboo forest in the province and the differentiation of management levels in different regions.
Estimation of Bamboo Forest Aboveground Carbon Using the RGLM Model Based on Object-Based Multiscale Segmentation of SPOT-6 Imagery

Abstract:Remote sensing is an important tool for the quantitative estimation of forest carbon stock. This study presents a multiscale, object-based method for the estimation of aboveground carbon stock in Moso bamboo forests. The method differs from conventional pixel-based approaches and is more suitable for Chinese forest management inventory. This research indicates that the construction of a SPOT-6 multiscale hierarchy with the 30 scale as the optimal segmentation scale achieves accurate information extraction for Moso bamboo forests. The producer's and user's accuracy are 88.89% and 86.96%, respectively. A random generalized linear model (RGLM), constructed using the multiscale hierarchy, can accurately estimate carbon storage of the bamboo forest in the study area, with a fitting and test accuracy (R-2) of 0.74 and 0.64, respectively. In contrast, pixel-based methods using the RGLM model have a fitting and prediction accuracy of 0.24 and 0.01, respectively; thus, the object-based RGLM is a major improvement. The multiscale object hierarchy correctly analyzed the multiscale correlation and responses of bamboo forest elements to carbon storage. Objects at the 30 scale responded to the microstructure of the bamboo forest and had the strongest correlation between estimated carbon storage and measured values. Objects at the 60 scale did not directly inherit the forest information, so the response to the measured carbon storage of the bamboo forest was the smallest. Objects at the 90 scale serve as super-objects containing the forest feature information and have a significant correlation with the measured carbon storage. Therefore, in this study, a carbon storage estimation model was constructed based on the multiscale characteristics of the bamboo forest so as to analyze correlations and greatly improve the fitting and prediction accuracy of carbon storage.

Abstract:Based on SPOT5 remotely sensed imagery,this research focused on delineating moso bamboo forest using object-based method,which provided the advantages of multi-scale segmentation and developing hierarchical structure.The results showed that: 1) The most appropriate window sizes for calculating texture using red( R),green( G) and blue( B) band in SPOT5 image were 9 ×9,7 ×7,9 ×9; 2) Extracting moso bamboo using multi-scale segmentation technique of object-based method was more accurate,with the producer's accuracy reaching 90%,obviously higher than that of the conventional maximum likelihood method( 88. 57%); 3) Multiresolution segmentation with the aid of texture not only ensured the accuracy of moso bamboo,but also provided help to the other forest types. The overall accuracy was 92% and the Kappa coefficient was 88. 14%,both of which were the highest accuracy in the present study.
Information Extracting and Spatiotemporal Evolution of Bamboo Forest Based on Landsat Time Series Data in Zhejiang Province

Abstract:[Objective] Monitoring bamboo forest resources and their changes using time series remote sensing has a great significance in achieving scientific management and efficient utilization of bamboo forest resources. [Method] This study extracted the information and analyzed spatiotemporal evolution of bamboo forest based on the Landsat5 TM and Landsat8 OLI time series data in 2000, 2004, 2008, and 2014 throughout Zhejiang Province to reveal the change of bamboo forest area and its response to land use change.Firstly, the land utilization information and spatiotemporal distribution of bamboo forest was extracted by maximum likelihood classification based on time series Landsat data, which was preprocessed by atmospheric correction and geometric correction. Secondly, the spatiotemporal evolution of bamboo forest during 2000—2014 using two indexes (variation amplitude and dynamic degree). Finally, the relationship between spatiotemporal dynamic of bamboo forest and land utilization pattern was analyzed based on the established provincial land use transition matrix.[Result] The result showed that: 1) The extracted bamboo forest information based on time series Landsat data achieved a high accuracy, which yield more than 75％ of classification accuracy and 91％ of user's accuracy, and the extracted bamboo forest area was highly correlated with investigation data, with area accuracy of beyond 96％. 2) The bamboo forest in Zhejiang Province was increased from 2000 to 2014, the variation amplitude and annual change rate were 16.55％ and 1.18％ respectively. 3) The bamboo forest area accounted for 7.33％ in 2000, and increased to 8.56％ in 2014, wherein the land use change of coniferous forest, broad-leaved forest and cultivated land have a great contribution to the increased of bamboo forest area, with the contribution rate of 28.62％, 37.23％ and 16.15％, respectively.[Conclusion] The bamboo forest resources could be accurately monitored based on the Landsat time series data, and the decreasing of coniferous forest, broad-leaved forest and cultivated land has significant influences on the spatiotemporal evolution of bamboo forest.
RS Estimation of Inventory Parameters and Carbon Storage of Moso Bamboo Forest Based on Synergistic Use of Object-Based Image Analysis and Decision Tree

Abstract:By synergistically using the object-based image analysis (OBIA) and the classification and regression tree (CART) methods,the distribution information,the indexes (including diameter at breast,tree height,and crown closure),and the aboveground carbon storage (AGC) of moso bamboo forest in Shanchuan Town,Anji County,Zhejiang Province were investigated.The results showed that the moso bamboo forest could be accurately delineated by integrating the multi-scale image segmentation in OBIA technique and CART,which connected the image objects at various scales,with a pretty good producer's accuracy of 89.1％.The investigation of indexes estimated by regression tree model that was constructed based on the features extracted from the image objects reached normal or better accuracy,in which the crown closure model archived the best estimating accuracy of 67.9％.The estimating accuracy of diameter at breast and tree height was relatively low,which was consistent with conclusion that estimating diameter at breast and tree height using optical remote sensing could not achieve satisfactory results.Estimation of AGC reached relatively high accuracy,and accuracy of the region of high value achieved above 80％.
Mapping bamboo with regional phenological characteristics derived from dense Landsat time series using Google Earth Engine

Abstract:Bamboo is an important plant not only because of its vital role in supporting biodiversity and land restoration, but also due to its contribution to poverty eradication. Although remote sensing has an advantage for monitoring vegetation, bamboo mapping is challenging due to the spectral similarity between bamboo and forest types. To overcome difficulties in bamboo mapping, we experimented with a phenology-based approach using dense Landsat time series data in Hainan Island, China. We constructed temporal profiles of Normalized Difference Vegetation Index (NDVI), Enhanced Vegetation Index (EVI), Green Chlorophyll Vegetation Index (GCVI), and Land Surface Water Index (LSWI) for estimating the phenological variation among bamboo and adjacent forest types. We then compared the classification results under an all-season feature set and single-season feature sets. Our results indicated that the phenological variations of bamboo differed greatly from adjacent forest types, implying a good potential for bamboo identification. Compared to the conventional spectra-based approach, these results also emphasized the importance of phenological features. Validation using the k-fold (k = 10) approach showed this experiment achieved reasonable levels of accuracy for bamboo mapping (PA = 88.8%; UA = 74.6%). A bamboo distribution map in Hainan Island is useful to resource inventory in the second largest island in China. The success of the method in this tropical region suggests that it might be applicable to other parts of the tropical world.
Improving Large-Scale Moso Bamboo Mapping Based on Dense Landsat Time Series and Auxiliary Data: a Case Study in Fujian Province, China

Abstract:Bamboo forest, especially moso bamboo forest, is very important to human society. However, our ability to detect large-scale moso bamboo with optical remote sensing is still limited due to the spectral similarity with other forest species and the influence of cloud occurrence. In this study, we examined the capability of dense Landsat time series for moso bamboo forest mapping by comparing three different interpretation schemes. For each scheme, two experimental groups were further conducted to investigate the usefulness of gray-level co-occurrence matrix (GLCM) textures. Considering classification accuracy, the full-season compositing strategy was regarded as the most efficient. It was generally beneficial to include GLCM textures as input features, although their usefulness would be partially offset due to noise/correlation issues. We also investigated the roles of 15 types of auxiliary covariates in extracting moso bamboo and found some of them could enhance the classification performance significantly. With the full-season compositing scheme and crucial auxiliary covariates, an improved moso bamboo mapping performance (93.21% in overall accuracy and 73.97% in minimum accuracy) was observed within the study area. Our evaluation results are promising to provide robust guidelines for remote mapping of moso bamboo forest over large areas.
Exploring Bamboo Forest Aboveground Biomass Estimation Using Sentinel-2 Data

Abstract:Bamboo forests, due to rapid growth and short harvest rotation, play an important role in carbon cycling and local economic development. Accurate estimation of bamboo forest aboveground biomass (AGB) has garnered increasing attention during the past two decades. However, remote sensing-based AGB estimation for bamboo forests is challenging due to poor understanding of the mechanisms between bamboo forest growth characteristics and remote sensing data. The objective of this research is to examine the remote sensing characteristics of on-year and off-year bamboo forests at different dates and their AGB estimation performance. This research used multiple Sentinel-2 data to explore AGB estimation of bamboo forests in Zhejiang Province, China, by taking into account the unique characteristics of on-year and off-year bamboo forest growth features. Combining field survey data and Sentinel-2 spectral responses (spectral bands and vegetation indices) and textural images, random forest was used to identify key variables for AGB estimation. The results show that (1) the on-year and off-year bamboo forests have considerably different spectral signatures, especially in the wavelengths between red edge 2 and near-infrared wavelength (NIR2) (740–865 nm), making it possible to separate on-year and off-year bamboo forests; (2) on-year bamboo forests have similar spectral signatures although AGB increases from as small as 40 Mgha−1 to as high as 90 Mgha−1, implying that optical sensor data cannot effectively model on-year bamboo AGB; (3) off-year bamboo AGB has significant relationships with red and shortwave infrared (SWIR) spectral bands in the April image and with red edge 2 in the July image, but the AGB saturation problem yields poor estimation accuracy; (4) stratification considerably improved off-year bamboo AGB estimation but not on-year, non-stratification using the April image is recommended; and (5) Sentinel-2 data cannot solve the bamboo AGB data saturation problem when AGB is greater than 70 Mgha−1, similar to other optical sensor data such as Landsat. More research should be conducted in the future to integrate multiple sources—remotely sensed data (e.g., lidar, optical sensor data) and ancillary data (e.g., soil, topography)—into AGB modeling to improve the estimation. The use of very high spatial resolution images that can effectively extract tree density information may improve bamboo AGB estimation and yield new insights.

A Novel Method for Mapping Moso Bamboo Forests Using Remote Sensing Data With the Consideration of Phenological Status

Abstract:Precisely delineating the distribution of moso bamboo forests is critical for forestry management and regional carbon cycle research. The unique phonological characteristics (i.e., on- and off-year phenomenon) of bamboo impose difficulties in bamboo identification. This study aims to develop a new algorithm for mapping bamboo distribution using remote sensing data with the consideration of bamboo phenological characteristics. Three optical indices were proposed based on canopy reflectance retrieved from Sentinel-2 and field inventory data, including modified bamboo index (MBI), bamboo phenological characteristic index (BPCI), and BPCI 2 (BPCI-2). The collaboration of these three indices with the recursive feature elimination (RFE) and extreme gradient boosting (XGBoost) methods can precisely map bamboo distribution and its phenological status. The model based on MBI, BPCI, and BPCI-2 outperformed the model driven by the existing bamboo extracting indices, i.e., bamboo index (BI), yearly change bamboo index (YCBI), and monthly change bamboo index (MCBI), increasing in overall accuracy (OA) by about 1.5%. Additionally, the proposed indices were calculated using the data synthesized from Sentinel-1 synthetic aperture radar (SAR) imageries by the cycle-consistent adversarial network (CycleGAN) method under the condition without cloudy-free Sentinel-2 data available to fill the time series data gaps. The performance of the model based on augmented data improved notably in comparison with the model driven only by indices from original optical images, with the identification accuracy for on- and off-year bamboo samples over 96%. The generated moso bamboo distribution map aligns well with forestry inventory data in terms of both area and spatial distribution. The proposed indices are less sensitive to terrain than the existing bamboo extracting indices. This merit is valuable for better mapping bamboo forests, which are mostly distributed in mountainous areas.

Mapping of bamboo forest bright and shadow areas using optical and SAR satellite data in Google Earth Engine

Abstract:Bamboo groves predominantly thrive in tropical or subtropical regions. Assessing the efficacy of remote sensing data of various types in extracting bamboo forest information from bright and shadow areas is a critical issue for achieving precise identification of bamboo forests in complex terrain. In this study, 34 features were obtained from Sentinel-1 SAR and Sentinel-2 optical images using the Google Earth Engine platform. The normalized shaded vegetation index (NSVI) was then employed to segment the bright and shadow woodlands. Different features from diverse data sources were evaluated to extract bamboo forest information in the bright and shadow areas, then use the random forest (RF) classification algorithm to extract bamboo forest. The results showed that (1) the red-edge and short-wave infrared bands of Sentinel-2 optical images and their corresponding vegetation indices are significant in bamboo forest information extraction. (2) The dissimilarity and homogeneity of Sentinel-2 texture features in the bright area and dissimilarity in the shadow area, the Sentinel-1 backscatter features in the bright area and the VV and VH in the bright area and VV-VH in the shadow area have some variability between bamboo and nonbamboo forests, which can be used as effective features for bamboo forest extraction. (3) The combination of spectral, texture and backscatter features yields the highest overall classification accuracy and Kappa coefficient, at 87.96% and 0.7435, respectively. This study has the potential for remote sensing refinement of bamboo forest identification in complex terrain areas by utilizing subregion classification methods combined with optical and radar image features.

Bamboo Forest Mapping in China Using the Dense Landsat 8 Image Archive and Google Earth Engine

Abstract:It is of great significance to understand the extent and distribution of bamboo for its valuable ecological services and economic benefits. However, it is challenging to map bamboo using remote sensing images over a large area because of the similarity between bamboo and other vegetation types, the availability of clear optical images, huge workload of image processing, and sample collection. In this study, we use the Landsat 8 times series images archive to map bamboo forests in China via the Google Earth engine. Several spectral indices were calculated and used as classification features, including the normalized difference vegetation index (NDVI), the normalized difference moisture index (NDMI) and textural features of the gray-level co-occurrence matrix (GLCM). We found that the bamboo forest covered an area of 709.92 × 104 hectares, with the provinces of Fujian, Jiangxi, and Zhejiang containing the largest area concentrations. The bamboo forest map was accurate and reliable with an average producer’s accuracy of 89.97%, user’s accuracy of 78.45% and kappa coefficient of 0.7789. In addition, bamboo was mainly distributed in forests with an elevation of 300–1200 m above sea level, average annual precipitation of 1200–1500 mm and average day land surface temperature of 19–25 °C. The NDMI is particularly useful in differentiating bamboo from other vegetation because of the clear difference in canopy moisture content, whilst NDVI and elevation are also helpful to improve the bamboo classification accuracy. The bamboo forest map will be helpful for bamboo forest industry planning and could be used for evaluating the ecological service of the bamboo forest.
Mapping bamboo forest and expansion intensity in China by coupling vegetation phenology and C-band SAR with Sentinel-1 and Sentinel-2 images

Abstract:Bamboo forest has undergone dramatic expansion due to climate changes and human activities, and its direct effects on both carbon storage and biodiversity of the forest ecosystem have occurred in tropical and subtropical regions, especially in China. However, the uncertainty in tracking bamboo forest extent and expansion intensity substantially influenced our assessment of them due to the poor resolution and persistent cloud covers in optical images (e.g., Landsat and Sentinel-2). We developed a straightforward and superior algorithm by coupling vegetation phenology and cloud-free SAR using Sentinel-1 and -2 images to identify bamboo forest at large scales and higher spatial resolution. Specifically, (1) this study analyzed the spectral and phenological characteristics during the bamboo forest growth season; (2) the optimum parameter sets for the SAR backscatter were calibrated against field data by using the genetic algorithm; (3) and then we generated bamboo forest and expansion intensity maps at 10 m spatial resolution for seven study regions in China in 2020. The results showed that the Kappa of the maps was 0.89, and the OA was 94.7% in all study areas, compared with the field data. The accuracy among each study area also performed well in mapping bamboo forest, indicated by Kappa varying from 0.82 to 0.94, and OA ranging from 91.1% to 97.33%. Compared to the national forestry inventory map, our results showed a significant positive linear relationship, with a higher R 2 (0.96, p < 0.001). With the high-resolution results, we found that the tree was most severely affected by bamboo forest, followed by grassland, sparse vegetation, and shrubland. This product can be a key input for many carbon cycles, climate, and vegetation models.

Abstract:Mangrove ecosystems play an irreplaceable role in coastal environments by providing essential ecosystem services. Diverse mangrove species have different functions due to their morphological and physiological characteristics. A precise spatial distribution map of mangrove species is therefore crucial for biodiversity maintenance and environmental conservation of coastal ecosystems. Traditional satellite data are limited in fine-scale mangrove species classification due to low spatial resolution and less spectral information. This study employed unmanned aerial vehicle (UAV) technology to acquire high-resolution multispectral and hyperspectral mangrove forest imagery in Guangxi, China. We leveraged advanced algorithms, including RFE-RF for feature selection and machine learning models (Adaptive Boosting (AdaBoost), eXtreme Gradient Boosting (XGBoost), Random Forest (RF), and Light Gradient Boosting Machine (LightGBM)), to achieve mangrove species mapping with high classification accuracy. The study assessed the classification performance of these four machine learning models for two types of image data (UAV multispectral and hyperspectral imagery), respectively. The results demonstrated that hyperspectral imagery had superiority over multispectral data by offering enhanced noise reduction and classification performance. Hyperspectral imagery produced mangrove species classification with overall accuracy (OA) higher than 91% across the four machine learning models. LightGBM achieved the highest OA of 97.15% and kappa coefficient (Kappa) of 0.97 based on hyperspectral imagery. Dimensionality reduction and feature extraction techniques were effectively applied to the UAV data, with vegetation indices proving to be particularly valuable for species classification. The present research underscored the effectiveness of UAV hyperspectral images using machine learning models for fine-scale mangrove species classification. This approach has the potential to significantly improve ecological management and conservation strategies, providing a robust framework for monitoring and safeguarding these essential coastal habitats.

Abstract:Bamboo is an important vegetation type and provides a number of critical ecosystem services. Reliable and consistent information on bamboo distribution is required to better estimate its effect on climate change mitigation and socio-economic development. However, such information is rare over a large spatial area. In this study, we evaluate the contribution of different features in the identification of bamboo stands and determine a more discriminative set of features. We propose a bamboo mapping system including feature extraction and feature selection and derive the long-term trends of bamboo distribution in Zhejiang Province, China, using time-series of Landsat data from 1990 to 2014, with an increment of 5 years 1990, 1995, 2000, 2005, 2010, and 2014. The resultant maps of bamboo in the six epochs were evaluated using independent validation samples. The overall accuracies OAs of all six epochs range from 85.9% to 90.7%. We found that bamboo distribution in Zhejiang substantially increased from 1990 to 2014, particularly during the 2000s. Based on the produced maps, the area of bamboo in this region increased from 5363 ± 490 km2 in 1990 to 11671 ± 653 km2 in 2014, which is consistent with the National Forest Resource Inventory NFRI data. Our study demonstrates the capability of time-series of Landsat data for continuous monitoring of bamboo at a large spatial scale.

Abstract:Bamboo forest is a unique forest landscape that is mainly composed of herbal plants. It has a stronger capability to increase terrestrial carbon sinks than woody forests in the same environment, thus playing a special role in absorbing atmospheric CO2. Accurate and timely bamboo forest maps are necessary to better understand and quantify their contribution to the carbon and hydrological cycles. Previous studies have reported that the unique phenology pattern of bamboo forests, i.e., the on- and off-year cycle, can be detected with time-series high spatial resolution remote sensing (RS) images. Nevertheless, this information has not yet been applied in large-scale bamboo mapping. In this study, we innovatively incorporate newly designed phenology features reflecting the aforementioned on- and off-year cycles into a typical end-to-end classification workflow, including two features describing growing efficiency during the green-up season and two features describing the difference between annual peak greenness. Additionally, two horizonal morphology features and one tree height feature were employed, simultaneously. An experiment in southeast China was carried out to test the method’s performance, in which seven categories were focused. A total of 987 field samples were used for training and validation (70% and 30%, respectively). The results show that combining the time-series features based on spectral bands and vegetation indices and newly designed phenology and morphology patterns can differentiate bamboo forests from other vegetation categories. Based on these features, the classification results exhibit a reasonable spatial distribution and a satisfactory overall accuracy (0.89). The detected bamboo area proportion in 82 counties agrees with the statistics from China’s Third National Land Survey, which was produced based on high resolution images from commercial satellites and human interpretation (correlation coefficient = 0.69, and root mean squared error = 5.1%). This study demonstrates that the new scheme incorporating phenology features helps to map bamboo forests accurately while reducing the sample size requirement.
Bamboo Classification Based on GEDI, Time-Series Sentinel-2 Images and Whale-Optimized, Dual-Channel DenseNet: A Case Study in Zhejiang Province, China

Abstract:Regional carbon sink estimation and local forest management require spatially explicit maps of bamboo distribution. However, accurate bamboo mapping is challenging due to the similarity of bamboo’s optical spectral with those of other vegetation. To gain a high-precision bamboo forest distribution map circa year 2020, we developed a novel classification framework that integrated in-situ measurements, GEDI, and time-series multispectral Sentinel-2 images in a whale-optimized dual-channel Dense Convolutional Network (DenseNet) classification algorithm. The new method shows that vegetation structure features from GEDI can improve the performance of bamboo mapping by more than 5 percent compared with results obtained using only spectral information. Additionally, ablation studies show our proposed dual-channel DenseNet with whale-optimized DropBlock regularization outperforms traditional deep learning algorithms. The proposed method demonstrates a high level of accuracy in identifying bamboo, with precision, recall (producer's and user's accuracies), and F1-score reaching 90.81%, 91.86%, and 91.33%, respectively, which can provide more detailed and accurate results than previous studies, especially in regions where the terrain is complex or bamboo is intermixed with other vegetation.
UAV-LiDAR Integration with Sentinel-2 Enhances Precision in AGB Estimation for Bamboo Forests

Abstract:Moso bamboo forests, recognized as a distinctive and significant forest resource in subtropical China, contribute substantially to efficient carbon sequestration. The accurate assessment of the aboveground biomass (AGB) in Moso bamboo forests is crucial for evaluating their impact on the carbon balance within forest ecosystems at a regional scale. In this study, we focused on the Moso bamboo forest located in Shanchuan Township, Zhejiang Province, China. The primary objective was to utilize various data sources, namely UAV-LiDAR (UL), Sentinel-2 (ST), and a combination of UAV-LiDAR with Sentinel-2 (UL + ST). Employing the Boruta algorithm, we carefully selected characterization variables for analysis. Our investigation delved into establishing correlations between UAV-LiDAR characterization parameters, Sentinel-2 feature parameters, and the aboveground biomass (AGB) of the Moso bamboo forest. Ground survey data on Moso bamboo forest biomass served as the basis for our analysis. To enhance the accuracy of AGB estimation in the Moso bamboo forest, we employed three distinct modeling techniques: multivariate linear regression (MLR), support vector regression (SVR), and random forest (RF). Through this approach, we aimed to compare the impact of different data sources and modeling methods on the precision of AGB estimation in the studied bamboo forest. This study revealed that (1) the point cloud intensity of UL, the variables of canopy cover (CC), gap fraction (GF), and leaf area index (LAI) reflect the structure of Moso bamboo forests, and the variables indicating the height of the forest stand (AIH1, AIHiq, and Hiq) had a significant effect on the AGB of Moso bamboo forests, significantly impact Moso bamboo forest AGB. Vegetation indices such as DVI and SAVI in ST also exert a considerable effect on Moso bamboo forest AGB. (2) AGB estimation models constructed based on UL consistently demonstrated higher accuracy compared with ST, achieving R2 values exceeding 0.7. Regardless of the model used, UL consistently delivered superior accuracy in Moso bamboo forest AGB estimation, with RF achieving the highest precision at R2 = 0.88. (3) Integration of ST with UL substantially improved the accuracy of AGB estimation for Moso bamboo forests across all three models. Specifically, using RF, the accuracy of AGB estimation increased by 97.7%, with R2 reaching 0.89 and RMSE reduced by 124.4%. As a result, the incorporation of LiDAR data, which reflects the stand structure, has proven to enhance the accuracy of aboveground biomass (AGB) estimation in Moso bamboo forests when combined with multispectral remote sensing data. This integration serves as an effective solution to address the limitations of single optical remote sensing methods, which often suffer from signal saturation, leading to lower accuracy in estimating Moso bamboo forest biomass. This approach offers a novel perspective and opens up new possibilities for improving the precision of Moso bamboo forest biomass estimation through the utilization of multiple remote sensing sources.
