Abstract:Histidine (C 6H 9N 3O 2) is one of the amino acids which are quite important indices for monitoring and indicating the growing status of oilseed rape. The traditional detection methods, such as HPLC or automatic amino acid analyzer were time consuming, laborious, and not convenient for fast and non-destructive determination. Nowadays, near infrared (NIR) spectroscopy is widely applied in quantitative and qualitative analysis for plant growing information detection. In this study, the oilseed rape leaf samples in calibration, validation and prediction sets were 80, 40 and 30, respectively. Linear and nonlinear chemometric methods were compared, including partial least squares (PLS) and least squares-support vector machine (LS-SVM). The performance of different spectral data pretreatments was compared, including Savitzky-Golay smoothing, standard normal variate, first and second derivatives. The correlation coefficient (R) and root mean square error (RMSE) were used as evaluation indices. Firstly, different pretreatments were implemented by PLS model. Secondly, certain wavelengths were selected by the regression coefficients plots. Simultaneously, for comparison, a newly developed informative information and relevant variable selection method, called successive projections algorithm (SPA), was employed to obtain the most effective wavelengths with least collinearity and redundancies. Thirdly, the selected wavelength by regression coefficients and SPA were used as the inputs of LS-SVM model, respectively. Finally, the performance of PLS and LS-SVM models were compared and the best model was achieved. The results indicated that a better prediction results were achieved by the SPA-LS-SVM model with correlation coefficient R = 0.9683 for validation set. NIR spectroscopy combined with LS-SVM was successfully applied for the non-destructive determination of histidine in oilseed rape leaves. This method could be used for the on field monitoring of growing status and other physiological parameters of oilseed rape, and it also helpful for the development of portable instruments and sensors for plant growing information detection.

Abstract:Accurate and timely prediction of oilseed rape yield is crucial in precision agriculture and field remote sensing. We explored the feasibility and potential for predicting oilseed rape yield through the utilization of a UAV-based platform equipped with RGB and multispectral cameras. Genetic algorithm–partial least square was employed and evaluated for effective wavelength (EW) or vegetation index (VI) selection. Additionally, different machine learning algorithms, i.e., multiple linear regression (MLR), partial least squares regression (PLSR), least squares support vector machine (LS-SVM), back propagation neural network (BPNN), extreme learning machine (ELM), and radial basis function neural network (RBFNN), were developed and compared. With multi-source data fusion by combining vegetation indices (color and narrow-band VIs), robust prediction models of yield in oilseed rape were built. The performance of prediction models using the combination of VIs (RBFNN: Rpre = 0.8143, RMSEP = 171.9 kg/hm2) from multiple sensors manifested better results than those using only narrow-band VIs (BPNN: Rpre = 0.7655, RMSEP = 188.3 kg/hm2) from a multispectral camera. The best models for yield prediction were found by applying BPNN (Rpre = 0.8114, RMSEP = 172.6 kg/hm2) built from optimal EWs and ELM (Rpre = 0.8118, RMSEP = 170.9 kg/hm2) using optimal VIs. Taken together, the findings conclusively illustrate the potential of UAV-based RGB and multispectral images for the timely and non-invasive prediction of oilseed rape yield. This study also highlights that a lightweight UAV equipped with dual-image-frame snapshot cameras holds promise as a valuable tool for high-throughput plant phenotyping and advanced breeding programs within the realm of precision agriculture.
Determination of Pigments Concentration of Oilseed Rape ( Brassica Napus L.) Leaves Using Hyperspectral Imaging

Abstract:A hyperspectral imaging system covering the spectral range 380-1030 nm was used to estimate leaf pigment concentration. Spectral information of rape leaves were extracted from the hyperspectral images. Partial least squares (PLS), least squares-support vector machine (LS-SVM), and extreme learning machine (ELM) were applied to build calibration models using spectra of 500-900 nm to determine the concentrations of chlorophyll a (Chl a), chlorophyll b (Chl b), total chlorophyll (tChl), and carotenoids (Car). For full spectra, ELM models performed best with correlation coefficient of prediction (r(p)) of 0.929, root mean square error of prediction (RMSEP) of 0.096 mg g(-1) and residual prediction deviation (RPD) of 2.37 for Chl a; r(p) of 0.883, RMSEP of 0.046 mg g(-1), and RPD of 2.01 for Chl b; r(p) of 0.912, RMSEP of 0.142 mg g(-1), and RPD of 2.29 for tChl; and r(p) of 0.914, RMSEP of 0.030 mg g(-1) and RPD of 2.29 for Car. The results showed that PLS, LS-SVM, and ELM models for chlorophyll a, chlorophyll b, total chlorophyll, and carotenoids obtained strong performances. Seventeen, 15, 19, and 8 sensitive wavelengths were selected for chlorophyll a, chlorophyll b, total chlorophyll, and carotenoids estimation by successive projections algorithm (SPA), respectively. For sensitive wavelengths, ELM models performed best with r(p) of 0.906, RMSEP of 0.108 mg g(-1) and RPD of 2.27 for Chl a; r(p) of 0.897, RMSEP of 0.043 mg g(-1), and RPD of 2.18 for Chl b; r(p) of 0.901, RMSEP of 0.145 mg g(-1), and RPD of 2.25 for tChl: and r(p) of 0.893, RMSEP of 0.034 mg g(-1) and RPD of 2.14 for Car. The results showed that PLS, LS-SVM, and ELM models based on the sensitive wavelengths also obtained good performance closed to the calibration models using full spectra. Compared with all developed models, the ELM models using full spectra and sensitive wavelengths obtained the best performances with highest re and lowest RMSEP, and highest RPD values for Chl a, Chl b, tChl, and Car concentration estimation, respectively. The overall results indicated that hyperspectral imaging with ELM method was an efficient technique for leaf pigment content determination, and the selected sensitive wavelengths would be helpful to develop portable instrument or on-field monitoring sensors in the precise agricultural management.

Abstract:Striped stem borer (SSB) usually causes serious damage to rice, and timely detection of SSB infestation is crucial in rice production. Hyperspectral imaging technology has been employed in to detect abiotic and biotic stresses on plant. In this study, the cost-sensitive stacked sparse auto-encoder (SSAE) was proposed to detect the early infestation stage on rice combined with visible/near-infrared hyperspectral imaging technology. The Fisher linear discriminate algorithm (LDA) was modified to quantify the distribution of feature representation of each layer. Multiple structures of the cost-sensitive SSAE were compared and the optimal structure was two depths with width of 6–6 and spares constraint of 0.1. The cost-sensitive SSAE acquired highest total accuracy of 93.44% with full input variables and satisfying total accuracy of 90.98% with reduced input variables, which were superior and stable in comparison with other state-of-art feature extraction and selection methods. These results indicated that the cost-sensitive SSAE has great potential in detecting early SSB infestation based on hyperspectral imaging technology.

Abstract:The paper explores the impact of astrophysical uncertainties on the Mikheyev-Smirnov-Wolfenstein (MSW) solution by calculating the allowed MSW solutions for 1000 different solar models with a Monte Carlo selection of solar model input parameters, assuming a full three-family MSW mixing. Applications are made to the chlorine, gallium, Kamiokande, and Borexino experiments. Abstract:This study assessed the viability of using hyperspectral imaging (HSI) technology for nondestructive detection of moisture content in oilseed rape leaves. Besides, a method (IVISSA-iPLS) coupling interval variable iterative space shrinkage approach (IVISSA) with interval partial least square (iPLS) was introduced to identify characteristic wavelengths. The IVISSA-iPLS algorithm changed the selection target from wavelength points to spectral intervals, reducing the computational burden while increasing the continuity between the selected wavelengths. Subsequently, the characteristic wavelengths selected by the IVISSA-iPLS were used as the input of the least square support vector regression (LSSVR) model to predict the moisture content of oilseed rape leaves. Additionally, the competitive adaptive reweighted sampling (CARS), the successive projections algorithm (SPA), the IVISSA, and the iPLS were investigated as wavelength selection algorithms for comparison. The results indicated that the LSSVR models based on the characteristic wavelengths acquired from the IVISSA-iPLS using divided wavelength intervals of 30, demonstrated the highest performance, with of 0.9555, RMSEP of 0.0065, and of 4.715. Finally, the optimal prediction model was used to visualize the moisture content of oilseed rape leaves, which offered a more intuitive and effective method for the evaluation of moisture content. The results ascertained the significant possibility of combining HSI with combinatorial algorithms in detecting, quantifying, and visualizing the moisture content of oilseed rape leaves.

Abstract:Efficient and accurate processing of large quantities of hyperspectral image (HSI) data is a challenging for the Non-destructive evaluation of nitrogen content in oilseed rape (Brassica napus L.). This research aimed to develop a fast nitrogen Contents grades classification method for Oilseed rape canopy by employing a deep learning algorithm named stacked auto-encoders (SAEs). In this study, 5 nitrogen degrees were applied for the oilseed rape samples and hyperspectral image data was acquired under 3 camera angles (0°, 15° and 25°) during the two growing stages before flowering. The algorithms SAEs was introduced for the data dimensional reduction and feature extraction from hyperspectral images, then multiple classification models were applied for the feature testing and validation within the feature data under different camera angles with different feature units. Our result shows the data under 25° shows the best classification result, besides, SAEs shows promising performance in HSI big data processing in phenotyping tasks.
Hyperspectral technique combined with stacking and blending ensemble learning method for detection of cadmium content in oilseed rape leaves

Abstract:Background: Oilseed rape, as one of the most important oil crops, is an important source of vegetable oil and protein for mankind. As a non-essential element for plant growth, heavy metal cadmium (Cd) is easily absorbed by plants. Cd will inhibit the photosynthesis of plants, destroy the cell structure, slow the growth of plants, and affect their development and yield. It is necessary to develop a method based on visible near-infrared (NIR) hyperspectral imaging (HSI) technology to quickly and nondestructively determine the Cd content in rape leaves. Results: Two-layer estimation models were established by combining visible-NIR HSI with ensemble learning methods (stacking and blending). One layer used support vector regression, extreme learning machine, decision tree, and random forest (RF) as basic learners, and the other layer used support vector regression or RF as a meta learner. Different models were used to analyze the spectra of rape treated with five Cd concentrations to obtain the best prediction method. The results showed that the best model to predict Cd content was the stacking ensemble model with RF as the meta learner, with coefficient of determination for prediction of 0.9815 and root-mean-square error for prediction of 5.8969 mg kg-1 . A pseudo-color image was developed using this stacking model to visualize the content and distribution of Cd. Conclusion: The combination of visible-NIR HSI technology and the stacking ensemble learning method is a feasible method to detect the Cd content in rape leaves, which has the potential of being rapid and nondestructive. © 2022 Society of Chemical Industry.
Detecting Macronutrients Content and Distribution in Oilseed Rape Leaves Based on Hyperspectral Imaging

Abstract:Visible and near infrared (Vis-NIR) hyperspectral imaging system was carried out to rapidly determinate the content and estimate the distribution of nitrogen (N) in oilseed rape leaves .Hyperspectral images of 420 leaf samples were acquired at seedling ,flowering and pod stages .The spectral data of rape leaves were extracted from the region of interest (ROI)in the wave-length range of 380~1 030 nm .Different spectra preprocessing including Savitzky-Golay smoothing (SG) ,standard normal vari-ate (SNV) ,multiplicative scatter correction (MSC) ,first and second derivatives were applied to improve the signal to noise ratio .Among 471 wavelengths ,only twelve wavelengths (467 ,557 ,665 ,686 ,706 ,752 ,874 ,879 ,886 ,900 ,978 and 995 nm) were selected by successive projections algorithm (SPA) as the effective wavelengths for N prediction .Based on these effec-tive wavelengths ,partial least squares(PLS) and least-squares support vector machines (LS-SVM ) calibration models were es-tablished for the determination of N content .Reasonable estimation accuracy was obtained ,with RP of 0.807 and RMSEP of 0.387 by PLS and RP of 0.836 and RMSEP of 0.358 by LS-SVM ,respectively .Considering the simple structure and satisfying results of PLS model ,SPA-PLS model was used to generate the distribution maps of N content in rape leaves .The concentra-tions of N were calculated at each pixel of hyperspectral images at the selected effective wavelengths by inputting its correspond-ing spectrum into the established SPA-PLS model .Different colour represented the change in N content in the rape leaves under different fertilizer treatments .By including all pixels within the selected ROI ,the average N status can be displayed in more de-tail and visualised .The visualization of N distribution could be helpful to understanding the change in N content in rape leaves during rape growth period and facilitate discovering the difference of N content within one sample as well as among the samples from different fertilising plots .The overall results revealed that hyperspectral imaging is a promising technique to detect N con-tent and distribution within oilseed rape leaves rapidly and nondestructively .

Abstract:The ability of fluorescence hyperspectral imaging to predict heavy metal lead (Pb) concentration in oilseed rape leaves was studied in silicon-free and silicon environments. Further, the transfer stacked convolution auto-encoder (T-SCAE) algorithm was proposed based on the stacked convolution auto-encoder (SCAE) algorithm. Fluorescence hyperspectral images of oilseed rape leaves under different Pb stress contents were obtained in the silicon-free and silicon environments. The entire region of oilseed rape leaves was chosen as the region of interest (ROI) to obtain fluorescence spectra. First of all, standard normalized variable (SNV) algorithm was implemented as the preferred preprocessing method, and the fluorescence spectral data processed by SNV was utilized for further analysis. Further, SCAE was used to reduce the dimensionality of the best pre-processed spectral data, and compared with the traditional dimensionality reduction algorithm. Finally, the optimal SCAE deep learning network was transferred to obtain the T-SCAE model to verify the transferability between the deep learning models in silicon-free and silicon environments. The results show that the SVR model based on the depth features extracted by SCAE has the best performance in predicting different Pb concentrations in silicon-free or silicon environments, and the coefficient of determination (R p 2 ), root mean square error (RMSEP) and residual predictive deviation (RPD) of prediction set in silicon-free or silicon environments were 0.9374, 0.02071 mg/kg and 3.268, and 0.9416, 0.01898 mg/kg and 3.316, respectively. Moreover, the SVR model based on the depth feature extracted by T-SCAE has the best performance in predicting different Pb concentrations in silicon-free and silicon environments, and the R p 2 , RMSEP and RPD of the optimal prediction set were 0.9385, 0.02017 mg/kg and 3.291, respectively. The combination of hyperspectral fluorescence imaging and deep transfer learning algorithm can effectively detect different Pb concentrations in oilseed rape leaves in both non-silicon environment and silicon environment.

Abstract:Exploring the cadmium (Cd) pollution in rape is of great significance to food safety and consumer health. In this study, a rapid, nondestructive and accurate method for the determination of Cd content in rape leaves based on hyperspectral imaging (HSI) technology was proposed. The spectral data of rape leaves under different Cd stress from 431 nm to 962 nm were collected by visible-near infrared HSI spectrometer. In order to improve the robustness and accuracy of the regression model, a machine learning algorithm was proposed, named multi-disturbance bagging Extreme Learning Machine (MdbaggingELM). The prediction models of Cd content in rape leaves based on MdbaggingELM and ELM-based method (ELM and baggingELM) were established and compared. The results showed that the model of the proposed MdbaggingELM method performed significantly in the prediction of Cd content, with Rp2 of 0.9830 and RMSEP of 2.8963 mg/kg. The results confirmed that MdbaggingELM is an efficient regression algorithm, which played a positive role in enhancing the stability and the prediction effect of the model. The combination of MdbaggingELM and HSI technology has great potential in the detection of Cd content in rape leaves.
Estimation and Visualization of Soluble Sugar Content in Oilseed Rape Leaves Using Hyperspectral Imaging

Abstract:A novel technology for hyperspectral imaging was used to estimate the soluble sugar content of rape leaves. Rape leaves collected at four different growth stages (seedling stage, bolting stage, florescence stage, and pod stage) were analyzed. Sample regions in the hyperspectral images were extracted by removing the background, and spectral data of all pixels in the sample region were extracted and averaged as the spectrum of the sample. Eleven of 128 samples were defined as outliers. The remaining samples were split into a calibration set and a prediction set in a 3: 1 ratio using two methods: considering the difference in growth stage (method 1) and not considering the growth stage (method 2). Eight and seven sensitive wavelengths were selected by a successive projections algorithm (SPA) for methods 1 and 2, respectively. Partial least squares (PLS) was applied to build calibration models using full spectra and sensitive wavelengths, and multiple linear regression (MLR) and back-propagation neural network (BPNN) models were built using selected wavelengths. The calibration models for method 1 performed better than the models for method 2. The BPNN for method 1 using sensitive wavelengths obtained the optimal prediction result, with a correlation coefficient of prediction (r(p)) of 0.885, root mean square error of prediction (RMSEP) of 2.010 mg g(-1), and residual prediction deviation (RPD) of 2.177. The overall results indicated that hyperspectral imaging could be used for detection of soluble sugar content in rape leaves. In addition to building calibration models for soluble sugar content estimation, visualization of soluble sugar distribution in rape leaves was achieved by predicting the soluble sugar content of each pixel within the image using the optimal SPA-BPNN model.

Abstract:Maize is inevitably contaminated by zearalenone (ZEN) that will cause serious harm to human beings. In this study, multispectral imaging (MSI) technology combined with different machine learning methods were used to detect ZEN content in maize. The wavelengths that were most related to ZEN content in maize could be selected by genetic algorithm with back-propagation neural network (GA-BPNN). Our results showed that ZEN contamination level could be detected with the accuracy of 93.33 % by GA-BPNN method. In addition, for quantitative prediction of ZEN content GA-BPNN algorithm was the best method with the correlation coefficient (Rp), the root means square error (RMSEP), residual predictive deviation (RPD) and bias achieved to 0.95, 3.66 μg/kg, 5.39 and 1.55 μg/kg, respectively in prediction set. It can be concluded that multispectral imaging combined with machine learning was applicable for rapid measurement of ZEN content in maize.

Abstract:Hyperspectral imaging was explored to detect Sclerotinia stem rot (SSR) on oilseed rape leaves with chemometric methods, and the influences of variable selection, machine learning, and calibration transfer methods on detection performances were evaluated. Three different sample sets containing healthy and infected oilseed rape leaves were acquired under different imaging acquisition parameters. Four discriminant models were built using full spectra, including partial least squares-discriminant analysis (PLS-DA), support vector machine (SVM), soft independent modeling of class analogies (SIMCA), and k-nearest neighbors (KNN). PLS-DA and SVM models were also built with the optimal wavelengths selected by principal component analysis (PCA) loadings, second derivative spectra, competitive adaptive reweighted sampling (CARS), and successive projections algorithm (SPA). The optimal wavelengths selected for each sample set by different methods were different; however, the optimal wavelengths selected by PCA loadings and second derivative spectra showed similarity between different sample sets. Direct standardization (DS) was successfully applied to reduce spectral differences among different sample sets. Overall, the results demonstrated that using hyperspectral imaging with chemometrics for plant disease detection can be efficient and will also help in the selection of optimal variable selection, machine learning, and calibration transfer methods for fast and accurate plant disease detection.

Abstract:Visible and near-infrared hyperspectral imaging covering spectral range of 380-1030 nm as a rapid and non-destructive method was applied to estimate the soluble protein content of oilseed rape leaves. Average spectrum (500-900 nm) of the region of interest (ROI) of each sample was extracted, and four samples out of 128 samples were defined as outliers by Monte Carlo-partial least squares (MCPLS). The weighted regression coefficient (Bw), successive projections algorithm (SPA) and genetic algorithm-partial least squares (GAPLS) selected 18, 15, and 16 sensitive wavelengths, respectively. SPA-PLS model obtained the best performance with r(p) of 0.9554, RMSEP of 0.1538 mg/g and RPD of 3.25. Distribution of protein content within the rape leaves were visualized and mapped on the basis of the SPA-PLS model. The overall results indicated that hyperspectral imaging could be used to determine and visualize the soluble protein content of rape leaves.

Abstract:Protein, oil content, linoleic acid, and lignan are several key indicators for evaluating the quality of flaxseed. In order to optimize the testing methods for flaxseed's nutritional quality and enhance the efficiency of screening high-quality flax germplasm resources, we selected 30 flaxseed species widely cultivated in Northwest China as the subjects of our study. Firstly, we gathered hyperspectral information regarding the seeds, along with data on protein, oil content, linoleic acid, and lignan, and utilized the SPXY algorithm to classify the sample set. Subsequently, the spectral data underwent seven distinct preprocessing methods, revealing that the PLSR model exhibited superior performance after being processed with the SG smoothing method. Feature wavelength extraction was carried out using the Successive Projections Algorithm (SPA) and the Competitive Adaptive Reweighted Sampling (CARS). Finally, four quantitative analysis models, namely Partial Least Squares Regression (PLSR), Support Vector Regression (SVR), Multiple Linear Regression (MLR), and Principal Component Regression (PCR), were individually established. Experimental results demonstrated that among all the models for predicting protein content, the SG-CARS-MLR model predicted the best, with and of 0.9563 and 0.9336, with the corresponding Root Mean Square Error Correction (RMSEC) and Root Mean Square Error Prediction (RMSEP) of 0.4892 and 0.5616, respectively. In the optimal prediction models for oil content, linoleic acid and lignan, the Rp2 was 0.8565, 0.8028, 0.9343, and the RMSEP was 0.8682, 0.5404, 0.5384, respectively. The study results show that hyperspectral imaging technology has excellent potential for application in the detection of quality characteristics of flaxseed and provides a new option for the future non-destructive testing of the nutritional quality of flaxseed.

Abstract:Rapid and non-destructive estimation of nitrogen content and vegetation index of crop is a potentially important application for both farm managers and researchers. A multi-spectral imaging sensor with three channels (Green, Red, Near-infrared) was used to estimate the nitrogen level and vegetation index of the oilseed rape canopy. The relationship between SPAD and nitrogen content was developed using a linear regression, and the correlation coefficient was 0.862, which meant that the SPAD values could be represent for the nitrogen content of oilseed rape. The linear models were developed between grey scale and reflectance value using a reference reflectance panel, and the regression coefficient was 0.9962 in Green channel. The SPAD values correlated with vegetation index was also studied, including normalized differential vegetation index (NDVI), NDVI (Green) and Ratio of near-infrared to green. The prediction correlation coefficients were 0.9415, 0.9362, and 0.9163 for SPAD-NDVI, SPAD-NDVI (Green), and SPAD-Ratio, respectively. The results indicated that the nitrogen content of oilseed rape canopy was successfully estimated by the vegetation index obtained by a multi-spectral sensor. This result also supplied a new approach for the on field monitoring of the growing status of oilseed rape.

Abstract:The feasibility of hyperspectral imaging with 400–1000 nm was investigated to detect malondialdehyde (MDA) content in oilseed rape leaves under herbicide stress. After comparing the performance of different preprocessing methods, linear and nonlinear calibration models, the optimal prediction performance was achieved by extreme learning machine (ELM) model with only 23 wavelengths selected by competitive adaptive reweighted sampling (CARS), and the result was RP = 0.929 and RMSEP = 2.951. Furthermore, MDA distribution map was successfully achieved by partial least squares (PLS) model with CARS. This study indicated that hyperspectral imaging technology provided a fast and nondestructive solution for MDA content detection in plant leaves.

Abstract:In this study we developed a technique to early and rapidly estimate seed yield using hyperspectral images of oilseed rape leaves in the visible and near infrared (VIS–NIR) region (380–1030nm). Hyperspectral images of leaves were acquired four times from field trials in China between seedling until pods stage. Seed yield data on individual oilseed rape plants were collected during the local harvest season in 2011. Partial least square regression (PLSR) was applied to relate the average spectral data to the corresponding actual yield. We compared four PLSR models from four growing stages. The best fit model with the highest coefficients of determination (RP2) of 0.71 and the lowest root mean square errors (RMSEP) of 23.96 was obtained based on the hyperspectral images from the flowering stage (on March 25, 2011). The loading weights of this resulting PLSR model were used to identify the most important wavelengths and to reduce the high dimensionality of the hyperspectral data. The new PLSR model using the most relevant wavelengths (543, 686, 718, 741, 824 and 994nm) performed well (RP2=0.71, RMSEP=23.72) for predicting seed weights of individual plants. These results demonstrated that hyperspectral imaging system is promising to predict the seed yield in oilseed rape based on its leaves in early growing stage.
