Abstract:The objective of this study was to develop a fully automated multiple-cow real-time lameness detection system using a deep learning approach for cattle detection and pose estimation that could be deployed across dairy farms. Utilising computer vision and deep learning, the system can analyse simultaneously both the posture and gait of each cow within a camera field of view to a very high degree of accuracy (94–100%). Twenty-five video sequences containing 250 cows in varying degrees of lameness were recorded and independently scored by three accredited Agriculture and Horticulture Development Board (AHDB) mobility scorers using the AHDB dairy mobility scoring system to provide ground truth lameness data. These observers showed significant inter-observer reliability. Video sequences were broken down into their constituent frames and with a further 500 images downloaded from google, annotated with 15 anatomical points for each animal. A modified Mask-RCNN estimated the pose of each cow to output 5 key-points to determine back arching and 2 key-points to determine head position. Using the SORT (simple, online, and real-time tracking) algorithm, cows were tracked as they move through frames of the video sequence (i.e., in moving animals). All the features were combined using the CatBoost gradient boosting algorithm with accuracy being determined using threefold cross-validation including recursive feature elimination. Precision was assessed using Cohen's kappa coefficient and assessments of precision and recall. This methodology was applied to cows with varying degrees of lameness (according to accredited scoring, n = 3) and demonstrated that some characteristics directly associated with lameness could be monitored simultaneously. By combining the algorithm results over time, more robust evaluation of individual cow lameness was obtained. The model showed high performance for predicting and matching the ground truth lameness data with the outputs of the algorithm. Overall, threefold lameness detection accuracy of 100% and a lameness severity classification accuracy of 94% respectively was achieved with a high degree of precision (Cohen's kappa = 0.8782, precision = 0.8650 and recall = 0.9209).

Abstract:The precise recognition of dairy cows' motion behaviors is crucial for the intelligent assessment of their health status. Previous researchers have utilized many methods to detect cow’s motion behaviors, but the accuracy and robustness of these methods remains to be improved. Skeleton-based action recognition methods have reported high accuracy and robustness, but these methods have rarely been applied to the detection of cow’s motion behavior. This research adopted a behavior recognition method based on skeleton features of dairy cows. First, the YOLOX was modified to YOLOX-Pose for end-to-end skeleton extraction. According to the extracted information, the PoseC3D based on 3D Convolutional Neural Network (CNN) was used to predict motion behaviors. In the process of model training, PoseC3D utilized a dataset consisting of 400 videos encompassing actions of lying, standing, walking, and lameness, while YOLOX-Pose was trained using a dataset comprising 1800 images. The results showed that, for skeleton extraction, YOLOX-Pose achieved an AP of 96.3% and detection speed of 33.1fps. For the recognition of the four actions using PoseC3D, the Top-1 accuracy was 92.6%. The results showed that the YOLOX-Pose was a lightweight and high-quality pose estimator, and PoseC3D, with extracted 2D skeleton information, could outperform Graph Convolutional Network (GCN) in action detection. The combination of the YOLOX-Pose and PoseC3D could be used to detect the four typical motion behaviors effectively.

Abstract:Ensuring the welfare of dairy cows requires precise monitoring of their daily exercise to evaluate their physical health. This necessitates innovative methods beyond traditional motion sensors. We present a novel method that integrates an enhanced YOLOv5s object detection model with the DeepSORT multi-object tracking algorithm to meticulously track dairy cow movements, providing holistic information about their health. Our research started with the establishment of a dedicated dataset tailored for cow detection. We then segmented the detection scope to focus on specific regions of interest. Within the modified YOLOv5s model, we replaced the standard CSPDarknet53 backbone with DenseNet to achieve deep separable convolution and feature reorganization modules, leading to reduced parameters, augmented feature expression, and better information flow. In particular, the SPD-Conv module was incorporated to retain intricate details, essential for detecting smaller and low-resolution targets. The transition from Generalized Intersection over Union (GIoU) Loss to Complete Intersection over Union (CIoU) loss improved detection accuracy and sped up model convergence. Our clustering approach, based on the elbow rule, optimized K-means clustering, enhancing speed and precision. For multi-object tracking, the DeepSORT model was tailored to cater to varying cow sizes, and we chose an algorithm to associate appearance information. We converted pixel data into real-world distances, providing exact 3D cow movement metrics. Experimental validation confirmed the efficacy of our approach. Our enhanced model surpassed the original YOLOv5s in performance by 11.1% for accuracy (97.4%), 9.6% for recall (97.8%), and 11.0% for average accuracy (98.2%). The comprehensive accuracy stood at 92.1% for our model. In conclusion, our innovative methodology offers a non-invasive means to monitor dairy cow exercise, paving the way for advanced health assessment techniques in the dairy sector.

YOLO-BYTE: An efficient multi-object tracking algorithm for automatic monitoring of dairy cows

Abstract:Dairy cows tracking is an essential means to obtain their behavioral information, real-time position, activity data, and health status. A multi-object tracking method (YOLO-BYTE) is proposed to address the problem of missed detection and false detection caused by complex environments in cow individual detection and tracking. The method improves upon the YOLO v7 Backbone network feature extraction module by adding a Self-Attention and Convolution mixed module (ACmix) to account for the uneven spatial distribution and target scale variation of the cows. Additionally, in order to reduce the number of model parameters, an improved lightweight Spatial Pyramid Pooling Cross Stage Partial Connections (SPPCSPC-L) module is adopted to reduce model complexity. At the same time, the state parameters in the Kalman filter are improved by directly predicting the width and height information of the tracking boxes, so as to improve the ByteTrack algorithm to make tracking boxes matching the cows more precisely and accurately. Experimental conducted on the dairy cow object detection and multi-object tracking dataset show that the proposed YOLO-BYTE model achieves a Precision (P) of 97.3% in the dairy cow target detection dataset, with an improved Recall (R) and Average Precision (AP) by 1.1% compared to the original algorithm, and an 18% reduction in model parameters. Moreover, the proposed method demonstrated significant improvements in High Order Tracking Accuracy (HOTA), Multi-Object Tracking Accuracy (MOTA), and Identification F1 (IDF1) by 4.4%, 6.1%, and 3.8%, respectively, compared to the original model, with a decrease of 37.5% in Identity Switch (IDS). The tracker runs in a real-time manner with an average analysis speed of 47 fps. Hence, it is demonstrated that the proposed approach is capable of effective multi-object tracking of dairy cows in natural scenes and provides technical support for non-contact dairy cow automatic monitoring.

Quality assessment of a telephone care system utilizing non-physician personnel.

Abstract:An approach to providing medical care by telephone is described and its content and quality assessed by means of an outcome study. Pediatric health assistants have been trained to evaluate, triage and offer home management advice in lieu of an office visit for medical problems presented by parents via telephone. During a four-week study period, data were collected on all calls (N = 2520) using a telephone encounter form. Fifty-nine per cent of all calls involved requests for care of illness, 30 per cent of which were independently handled by the health assistant. Quality of care was evaluated for those cases who received advice in home management by means of a seven day follow-up interview with parents (N = 247). Access, parent satisfaction, residual symptoms, and the need for further care were ascertained. Greater than 90 per cent of parents expressed satisfaction and 92 per cent of problems had resolved. Results indicate that this telephone care system can effectively sort out and advise parents in home management for the many minor problems which occur in a pediatric practice, thereby increasing time for direct contact with patients.

Abstract:Body size parameters of beef cattle are crucial for assessing growth status and breeding value. In actual farming environments, the various postures of beef cattle and complex backgrounds can affect the accuracy and stability of non-contact body measurement methods. Therefore, this paper proposes a novel method called the Cattle Body Measurement Method (CBMM), which combines keypoint detection with local point cloud clustering. First, a keypoint detection model based on YOLOv8-SimBiFPN is constructed. This model enhances the feature extraction and fusion capabilities of YOLOv8-pose by introducing SimAM and BiFPN into the backbone and neck networks, respectively, and realizes 2D keypoint detection for beef cattle in various postures. Second, a 3D keypoint-locating algorithm based on DBSCAN is proposed. This algorithm utilizes 2D keypoints, depth maps and camera parameters to generate local point clouds, which are then clustered using DBSCAN to segment cattle body point clouds, thereby relocating the 3D keypoints based on their positional features. Finally, body size parameters are calculated based on the 3D keypoints and distance formulae. In our experiment, the mean average precision (mAP@0.5) of YOLOv8-SimBiFPN reached 99.1% on an Angus beef cattle keypoint detection dataset. The mean absolute percentage errors for measuring beef cattle withers height, hip height, body depth, body length, and oblique body length using the CBMM were 4.37%, 4.96%, 6.47%, 4.84%, and 4.14%, respectively. In summary, our method can achieve non-contact body measurement for beef cattle in a free-moving state with high accuracy and stability.

Abstract:Precision livestock farming is a hot topic in the field of agriculture at present. However, due to the diversity of breeding environments, the current intelligent monitoring of animal information still faces challenges. In this study, a YOLOv5-ASFF object detection model was proposed to detect cattle body parts (e.g. individual, head, legs) in complex scenes. The proposed YOLOv5-ASFF consists of two components: YOLOv5 responsible for extracting multi-scale features from sample images, while ASFF was used to adaptively learn fused spatial weights for each scale feature map and fully acquire the features. In this way, the cattle area detection was realized and the generalization of detection model was improved. To verify the applicability and robustness of YOLOv5-ASFF, a challenging dataset consisting of cattle (cow and beef) with complex environments (e.g. different lighting, occlusion, different depths of field, multiple targets and small targets) was constructed for experimental testing. The proposed method based on YOLOv5-ASFFachieved a precision of 96.2%, a recall of 92%, an F1 score of 94.1%, and an of 94.7% on this dataset, which outperformed Faster R-CNN, Cascade R-CNN, SSD, YOLOv3 and YOLOv5s. Experimental results showed that the YOLOv5-ASFF method could fully learn more animal biometric visual features, thereby improving the performance of cattle detection model, especially the detection of key parts. Overall, the proposed deep learning-based cattle detection method is favorable for long-term autonomous cattle monitoring and management in intelligent livestock farming.

Abstract:The development of intelligent agriculture has accelerated the automation and scale of cattle farming. Recognizing cattle faces as a significant biological characteristic is crucial for accurate reproduction and health tracking. We propose a multi-target cow face detection model (MT-CF-DM) in complex scenes based on the YOLOv7 framework. The backbone of our proposal model consists of the GhostNet and the CBAM (convolutional block attention module) attention mechanism to improve the model's perception of various scales and features. Additionally, we propose three novel modules of the neck network: SPPFCSPC (Spatial Pyramid Pooling-Fast Cross-Stage Partial Connection), a novel BiFPN, and C2f (CSP Bottleneck with 2 convolutions). SPPFCSPC is to reduce the number of model parameters. New BiFPN is to utilize feature information and improve the model's detection capability. C2f is to maintain the network's lightweight nature and obtain more comprehensive gradient flow data. Moreover, a method for establishing cow face datasets is proposed based on the MT-CF-DM. During the testing phase, our model combines with a cropping module to simultaneously acquire a dataset for cow faces. The experimental results show the parameter of the proposal model is 15.8 M, the model size is 22.3 M, GFLOPs are 25.8, FPS is 97.6, mAP is 98.5%, precision is 98.8%, recall is 97.3%. Compared to YOLOv7, our proposed model reduces parameters by 56.8% and has a 48.3 increase in FPS. The model demonstrates high accuracy and small number of parameters for detecting cow faces in complex environments, suitable for edge computing system applications.

Abstract:In livestock farming, animal health directly influences productivity. For dairy cows, many health conditions can be evaluated by trained observers based on visual appearance and movement. However, to manually evaluate every cow in a commercial farm is expensive and impractical. This paper introduces a video-analytic system which automatically detects the cow structure from captured video sequences. A side-view cow structural model is designed to describe the spatial positions of the joints (keypoints) of the cow, and we develop a system using deep learning to automatically extract the structural model from videos. The proposed detection system can detect multiple cows in the same frame and provide robust performance under practical challenges like obstacles (fences) and poor illumination. Compared to other object detection methods, this system provides better detection results and successfully isolates the keypoints of each cow even when they are close to each other.

Abstract:Automatic farm livestock detection and recognition have high importance in the management of livestock due to the increasing potentials in dairy cow welfare as well as production efficiency. In contrast to the general object (e.g., person, car and bird), the recognition of farm livestock still remains challenging due to the open complex scenarios, similar appearance, shape deformation, occlusion and insufficient annotated data and needs to be solved. In this paper, we discuss the problem of cow face detection and recognition by releasing a new large-scale cow dataset which containing about 50,000 annotated cow face detection data and probably 18,000 cow recognition data. Moreover, a cow face recognition framework is proposed which hybrids the detection and recognition model to improve the recognition performance. Experimental results show the superiority of the proposed method. The accuracy of the detection is 98.3%, and the accuracy of the cow face recognition is up to 94.1%.
Multi-Target Feeding-Behavior Recognition Method for Cows Based on Improved RefineMask

Abstract:Within the current process of large-scale dairy-cattle breeding, to address the problems of low recognition-accuracy and significant recognition-error associated with existing visual methods, we propose a method for recognizing the feeding behavior of dairy cows, one based on an improved RefineMask instance-segmentation model, and using high-quality detection and segmentation results to realize the recognition of the feeding behavior of dairy cows. Firstly, the input features are better extracted by incorporating the convolutional block attention module into the residual module of the feature extraction network. Secondly, an efficient channel attention module is incorporated into the neck design to achieve efficient integration of feature extraction while avoiding the surge of parameter volume computation. Subsequently, the GIoU loss function is used to increase the area of the prediction frame to optimize the convergence speed of the loss function, thus improving the regression accuracy. Finally, the logic of using mask information to recognize foraging behavior was designed, and the accurate recognition of foraging behavior was achieved according to the segmentation results of the model. We constructed, trained, and tested a cow dataset consisting of 1000 images from 50 different individual cows at peak feeding times. The method's effectiveness, robustness, and accuracy were verified by comparing it with example segmentation algorithms such as MSRCNN, Point_Rend, Cascade_Mask, and ConvNet_V2. The experimental results show that the accuracy of the improved RefineMask algorithm in recognizing the bounding box and accurately determining the segmentation mask is 98.3%, which is higher than that of the benchmark model by 0.7 percentage points; for this, the model parameter count size was 49.96 M, which meets the practical needs of local deployment. In addition, the technologies under study performed well in a variety of scenarios and adapted to various light environments; this research can provide technical support for the analysis of the relationship between cow feeding behavior and feed intake during peak feeding periods.

Research on Cattle Behavior Recognition and Multi-Object Tracking Algorithm Based on YOLO-BoT

Abstract:In smart ranch management, cattle behavior recognition and tracking play a crucial role in evaluating animal welfare. To address the issues of missed and false detections caused by inter-cow occlusions and infrastructure obstructions in the barn environment, this paper proposes a multi-object tracking method called YOLO-BoT. Built upon YOLOv8, the method first integrates dynamic convolution (DyConv) to enable adaptive weight adjustments, enhancing detection accuracy in complex environments. The C2f-iRMB structure is then employed to improve feature extraction efficiency, ensuring the capture of essential features even under occlusions or lighting variations. Additionally, the Adown downsampling module is incorporated to strengthen multi-scale information fusion, and a dynamic head (DyHead) is used to improve the robustness of detection boxes, ensuring precise identification of rapidly changing target positions. To further enhance tracking performance, DIoU distance calculation, confidence-based bounding box reclassification, and a virtual trajectory update mechanism are introduced, ensuring accurate matching under occlusion and minimizing identity switches. Experimental results demonstrate that YOLO-BoT achieves a mean average precision (mAP) of 91.7% in cattle detection, with precision and recall increased by 4.4% and 1%, respectively. Moreover, the proposed method improves higher order tracking accuracy (HOTA), multi-object tracking accuracy (MOTA), multi-object tracking precision (MOTP), and IDF1 by 4.4%, 7%, 1.7%, and 4.3%, respectively, while reducing the identity switch rate (IDS) by 30.9%. The tracker operates in real-time at an average speed of 31.2 fps, significantly enhancing multi-object tracking performance in complex scenarios and providing strong support for long-term behavior analysis and contactless automated monitoring.
Recognition of the behaviors of dairy cows by an improved YOLO

Abstract:The physiological well-being of dairy cows is intimately tied to their behavior. Detecting aberrant dairy cows early and reducing financial losses on farms are both possible with real-time and reliable monitoring of their behavior. The behavior data of dairy cows in real environments have dense occlusion and multi-scale issues, which affect the detection results of the model. Therefore, we focus on both data processing and model construction to improve the results of dairy cow behavior detection. We use a mixed data augmentation method to provide the model with rich cow behavior features. Simultaneously refining the model to optimize the detection outcomes of dairy cow behavior amidst challenging conditions, such as dense occlusion and varying scales. First, a Res2 backbone was constructed to incorporate multi-scale receptive fields and improve the YOLOv3's backbone for the multi-scale feature of dairy cow behaviors. In addition, YOLOv3 detectors were optimized to accurately locate individual dairy cows in different dense environments by combining the global location information of images, and the Global Context Predict Head was designed to enhance the performance of recognizing dairy cow behaviors in crowded surroundings. The dairy cow behavior detection model we built has an accuracy of 90.6%, 91.7%, 80.7%, and 98.5% for the four behaviors of dairy cows standing, lying, walking, and mounting, respectively. The average accuracy of dairy cow detection is 90.4%, which is 1.2% and 12.9% higher than the detection results of YOLOV3, YOLO-tiny and other models respectively. In comparison to YOLOv3, the Average Precision evaluation of the model improves by 2.6% and 1.4% for two similar features of walking and standing behaviors, respectively. The recognition results prove that the model generalizes better for recognizing dairy cow behaviors using behavior videos in various scenes with multi-scale and dense environment features.

Abstract:In this study, YOLO+P is proposed, which successfully solves the difficulties. Experimental results show that the recognition accuracy of our proposed YOLO+P algorithm is better than the state‐of‐the‐art deep learning methods. It is believed that this paper is suitable for publication in IET Image Processing and will be of great interest to a wide range of readers, including computer scientists and researchers in other related fields. It will also be of great interest to researchers in other related fields. To effectively address common issues such as cattle being obscured by fences and images prone to colour shifts and high brightness in a ranch setting, this paper proposes an algorithm for counting cows based on multi‐scale perception and image correlation. The algorithm first adjusts the model output scale to enhance cattle detection under current conditions. It incor‐porates efficient Partial Convolution (PConv) to replace 3 × 3 convolutions in the Neck segment of the YOLOv7 network, boost‐ing computational speed and reducing complexity. To streamline feature fusion, Dynamic Head (DyHead) unifies multiple at‐tentional operations in the Neck segment, enhancing efficiency. Additionally, it introduces a novel bounding box similarity metric Minimum Point DioU (MPDIoU) based on minimum point distance, encompassing factors from existing loss functions, while simplifying computations. Experimental results demonstrate the algorithm significantly improves detection, achieving 98.8% accuracy, 99.0% recall, and a 92.1% mAP value. Compared with mainstream SOTA models, Precision increases by 0.4%, Recall by 2.0%, and mAP value by 2.2%. Model size decreases by 23.9%, parameter count by 23.0%, and computational load by 6.1%. the algorithm shows improvements across all indices, meeting the challenge of real‐time cattle counting in ranches under complex conditions.

Abstract:Accurate estrus detection is of paramount importance for optimizing the reproductive efficiency of livestock. Traditional methods are often labor-intensive and subjective. The cow estrus period, which only lasts 12-24 hours in a cycle that repeats every 18-24 days, causes the opportunity to mate or perform artificial insemination to be missed. This study proposes a novel approach that utilizes pose estimation with a deep learning model for real-time estrus detection in female cows. We collected a dataset of annotated images of cows at different estrus stages and developed a deep learning model based on the EfficientPose architecture. The cow estrus parameter analyzed was locomotion activity, which was categorized into lying down and standing classes with an integrated system and LCD-displayed detection results. The Jetson Nano and YOLOv5 algorithms processed the input parameter data with a mean average precision (mAP) of 0.8 and a final loss prediction value of 0.01. If the female cow is classified as active (number of lying down classes < 57,600 classes/h), then the cow is considered to be in the estrus period. This system provides reliable and non-invasive estrus detection, enabling timely intervention for improved reproductive management in cattle farming.
Interactions of Hydrofluorocarbons and Polyolester Lubricants

Abstract:A variety of hydrofluorocarbon (HFC) compounds, both as pure substances and mixtures, are being developed as alternative refrigerants to replace the exsting chlorofluorocarbons and hydrofluorocarbons which have been linked to stratospheric ozone depletion. The use ofHFC's in refrigeration systems will require new lubricants, and polyolesters are being widely promoted as the lubricant of choice for HFC refrigerants. Understanding the chemical and physical properties of mixtures of the new lubricants and proposed HFCs is of utmost importance for applying the alternatives to existing or new equipment. Recently, we have developed a new theoretical model for oiUrefrigerant interactions (solubility and viscosity). In the present report, experimental data are compared with the model. In addition, a new method to determine the miscibility gap of refrigerant/oil mixtures has been developed and tested. INTRODUCTION Various physical and chemical properties of HFC-lubricant mixtures are needed to develop useful products as alternative refrigerants for new and existing equipment. The chemical stability of HFC's in the presence of oil is one concern, as are the thermodynamic/thermophysical properties such as mutual solubility (miscibility and immiscibility) and viscosity of mixtures. Since HFCs are soluble (or at least partially miscible) with polyolester oils, the oil will act as another comi>onent of the refrigerant. This means the refrigerant (pure or mixture) contains an additional compound, and all thermodynamic properties such as vapor pressure, compositions of vapor/liquid phases, etc. will be affected due to the extra component. In this report, we are particularly interested in the thermodynamic aspects of 1-WC/polyolester oil mixtures. A recent development of our theoretical modeling on the oiUrefrigerant interactions will be further examined. The model is constructed using the vapor-liquid equlibrium (VLE) data of binary systems (oiUrefrigerant). Since it is based on thermodynamic theory, it should be able to predict all thermodynamic properties, including the vapor-liquid-liquid equilibrium (VLLE) of mixtures. The VLLE prediction is known to be a severe test for the validity of such a model, while the experimental method used commonly to obtain such data is tedious and often contains large uncertainties. Therefore, we have developed a new experimental method to obtain such data to test the model prediction. Another test for the validity of the model is to compare predicted vapor compositions of oiUrefigerant mixtures with data obtained from Gas Chromatography (GC) experiments. Abstract:<p>Livestock identification is of great significance for achieving precision livestock farming as it is a prerequisite of modern livestock management and automatic behaviour analysis. With respect to cow identification, methods based on computer vision have been widely considered due to their advantage of non-contact and practicality. In this paper, a novel non-contact cow identification method based on fusion of deep parts features is proposed. First, a set of side-view images of cows were captured, and then the YOLO object detection model was applied to locate the cow object in each original image, which was then divided into three parts, head, trunk and legs, by a part segmentation algorithm using frame differencing and segmentation span analysis. Then, three independent convolutional neural networks (CNNs) were trained to extract deep features from these three parts, and a feature fusion strategy was designed to fuse the features, i.e., deep parts feature fusion. Finally, a support vector machine (SVM) classifier trained by the fused features was used to identify each individual cow. The proposed method achieved 98.36% cow identification accuracy on a dataset containing side-view images of 93 cows, which outperformed existing works. Experimental results showed the effectiveness of the proposed cow identification method and the good potential for this method in individual identification of other livestock.</p>

Abstract:To improve the detection speed of cow mounting behavior and the lightness of the model in dense scenes, this study proposes a lightweight rapid detection system for cow mounting behavior. Using the concept of EfficientNetV2, a lightweight backbone network is designed using an attention mechanism, inverted residual structure, and depth-wise separable convolution. Next, a feature enhancement module is designed using residual structure, efficient attention mechanism, and Ghost convolution. Finally, YOLOv5s, the lightweight backbone network, and the feature enhancement module are combined to construct a lightweight rapid recognition model for cow mounting behavior. Multiple cameras were installed in a barn with 200 cows to obtain 3343 images that formed the cow mounting behavior dataset. Based on the experimental results, the inference speed of the model put forward in this study is as high as 333.3 fps, the inference time per image is 4.1 ms, and the model mAP value is 87.7%. The mAP value of the proposed model is shown to be 2.1% higher than that of YOLOv5s, the inference speed is 0.47 times greater than that of YOLOv5s, and the model weight is 2.34 times less than that of YOLOv5s. According to the obtained results, the model proposed in the current work shows high accuracy and inference speed and acquires the automatic detection of cow mounting behavior in dense scenes, which would be beneficial for the all-weather real-time monitoring of multi-channel cameras in large cattle farms.
