Abstract:Multi-agent path finding in formation has many potential real-world applications like mobile warehouse robotics. However, previous multi-agent path finding (MAPF) methods hardly take formation into consideration. Further-more, they are usually centralized planners and require the whole state of the environment. Other decentralized partially observable approaches to MAPF are reinforcement learning (RL) methods. However, these RL methods encounter difficulties when learning path finding and formation problems at the same time. In this paper, we propose a novel decentralized partially observable RL algorithm that uses a hierarchical structure to decompose the multi-objective task into unrelated ones. It also calculates a theoretical weight that makes each tasks reward has equal influence on the final RL value function. Additionally, we introduce a communication method that helps agents cooperate with each other. Experiments in simulation show that our method outperforms other end-to-end RL methods and our method can naturally scale to large world sizes where centralized planner struggles. We also deploy and validate our method in a real-world scenario.

Abstract:Many tasks have demand on precise predictions of agents or moving objects. Previous prediction methods usually only focus on the kinematic model of moving objects or the environment. However, the target tasks of agents may influence the prediction of agents in great sense, especially in tasks of confrontation. Therefore traditional methods cannot work well in such scenes. In this paper, we propose a heterogeneous graph neural network method to deal with the multi-agent trajectory prediction problem. Our method can aggregate and pass messages representing environment and also agents' tasks due to the elaborate design of graph neural network structure. We validate our method on the Robocup Small Size League simulation platform which focuses on multi-agent coordination and confrontation in the form of soccer games. After making our own ZJUNlictSSL dataset, we predict the position of all robots on the pitch of certain time gaps based on the limited information we get from vision. The results prove that our method is of high prediction accuracy and low prediction error compared with conventional kinematic motion methods. Code is available here.

Abstract:This paper presents an algorithm that generates distributed collision-free velocities for multi-robot while maintain formation as much as possible. The adaptive formation problem is cast as a sequential decision-making problem, which is solved using reinforcement learning that trains several distributed policies to avoid dynamic obstacles on the top of consensus velocities. We construct the policy with Bayesian Linear Regression based on a neural network (called BNL) to compute the state-action value uncertainty efficiently for sequential decision making. The information-directed sampling is applied in our BNL policy to achieve efficient exploration. By further combining the distributional reinforcement learning, we can estimate the intrinsic uncertainty of the state-action value globally and more accurately. For continuous control tasks, efficient exploration can be achieved by optimizing a policy with the sampled action value function from a BNL model. Through our experiments in some contextual Bandit and sequential decision-making tasks, we show that exploration with the BNL model has improved efficiency in both computation and training samples. By augmenting the consensus velocities with our BNL policy, experiments on Multi-Robot navigation demonstrate that adaptive formation is achieved.

Abstract:This paper proposes a label-free bearing-based formation control method of multi-agent systems based on a self-organizing map (SOM) neural network. The Follower Henneberg Construction is defined to construct the interaction network of the multi-agent system. The position of each agent in the target formation is not preset, but determined by the consensus-based auction algorithm (CBAA) in the competition stage of the SOM to obtain optimal trajectories of agents. The proposed method drives agents to form the target formation by controlling the bearings between each agent and its neighbors. The effectiveness and robustness of the method are verified by simulating the formation control process in 2-dimensional and 3-dimensional Euclidean space.
Decentralized Formation Flocking for Multiple Non-Holonomic Agents

Abstract:In this paper, we present a novel decentralized flocking algorithm to realize formation control of multiple non-holonomic agents travelling in two-dimensional space. The flocking mechanism consists of five essential properties: (1) collision avoidance; (2) alignment of their heading angles; (3) consensus on their thrusting speeds; (4) consensus on their rotational speeds; (5) minimization of the whole potential energy. By using the nearest neighbor rules, a distributed flocking algorithm is presented on the basis of the combination of consensus and attraction/repulsion functions. Furthermore, arbitrarily shaped formation control problem of multi-agent system can thus be solved by adding the information of the desired formation topology to the potential functions of the proposed flocking algorithm. Consider that the initial communication topology of the system is an undirected connected graph, the stability of the closed-loop system is proved by applying LaSalle-Krasovskii invariance principle. The connectivity of the communication network can be preserved throughout the evolution by means of the effect of the potential functions. Finally, the numerical simulation results validate that the proposed algorithm is effective.

Abstract:The formation control of multi-agent systems has increasingly drawn attention for fulfilling numerous emerging applications and services. To achieve high-accuracy formation, the location awareness of all agents becomes an essential requirement. In this paper, we address the problem of network localization and formation control in a cooperative system with asynchronous agents. In particular, we formulate the joint localization and synchronization of agents as a statistical inference problem. The underlying probabilistic model is represented by a factor graph from which a message-passing algorithm is designed that computes approximations of the marginals of unknown variables, i.e. agents’ locations and clock offsets. Due to the Euclidean-norm operator involved in their computation no parametric closed-form expressions of the messages exist. As a compromise, implemented message-passing methods therefore resort to approximations of these messages. Conventional methods rely either on a first-order Taylor expansion of the norm operation or on non-parametric representations, e.g. by means particle filters (PFs), to compute such approximations. However, the former approach suffers from poor performance while the latter one experiences high complexity. The proposed message-passing algorithm in this paper is parametric. Specifically, it passes Gaussian messages that can be essentially obtained by suitably augmenting the factor graph and applying on it a hybrid method for combining belief propagation and variational message passing. Subsequently, the agents can exploit the estimated locations for determining the control policy. Two types of control policy are designed based on the optimization of a generalized cost function. We show that the proposed scheme enjoys a reduced complexity for multi-agent localization while achieving the desired formation with excellent accuracy.

Abstract:This paper aims at proposing a framework for animating virtual humans that can efficiently interact with real users in virtual reality (VR). If the user's order can be modeled as targets and commands, the system searches a database for the most convenient behavior. In order to avoid using a huge database that can deal with any kind of situation, we propose to associate this searching process to an adaptation module. Hence, even if the selected motion is not perfectly suited with the situation, it can be adapted in order to reach accurately the target specified by the user. This framework is illustrated with a kung-fu fighter example. Two people are involved in this example: the user and the supervisor. The user is displacing in the real environment while the position of his head is tracked in real-time thanks to reflective markers. The virtual opponent follows the displacement of the user to stay close to him. At any time, the supervisor can ask the virtual character to kick or punch the user. Our system automatically searches for the convenient motion in an average-size database (75 motions compared to hundreds of motions required for motion graphs) and adapts it to the current situation.
Motion Prediction of Multi-agent systems with Multi-view clustering

Abstract:This paper presents a method for future motion prediction of multi-agent systems by including group formation information and future intent. Formation of groups depends on a physics-based clustering method that follows the agglomerative hierarchical clustering algorithm. We identify clusters that incorporate the minimum cost-to-go function of a relevant optimal control problem as a metric for clustering between the groups among agents, where groups with similar associated costs are assumed to be likely to move together. The cost metric accounts for proximity to other agents as well as the intended goal of each agent. An unscented Kalman filter based approach is used to update the established clusters as well as add new clusters when new information is obtained. Our approach is verified through non-trivial numerical simulations implementing the proposed algorithm on different datasets pertaining to a variety of scenarios and agents.

Abstract:This paper considers a leader-following formation control problem for heterogeneous, second-order, uncertain, input-affine, nonlinear multi-agent systems modeled by a directed graph. A tunable, three-layer neural network (NN) is proposed with an input layer, two hidden layers, and an output layer to approximate an unknown nonlinearity. Unlike commonly used trial and error efforts to select the number of neurons in a conventional NN, in this case an \textit{a priori} knowledge allows one to set up the number of neurons in each layer. The NN weights tuning laws are derived using the Lyapunov theory. The leader-following and formation control problems are addressed by a robust integral of the sign of the error (RISE) feedback and a NN-based control. The RISE feedback term compensates for unknown leader dynamics and the unknown, bounded disturbance in the agent error dynamics. The NN-based term compensates for the unknown nonlinearity in the dynamics of multi-agent systems, and semi-global asymptotic tracking results are rigorously proven using the Lyapunov stability theory. The results of the paper are compared with two previous results to evaluate the efficiency and performance of the proposed method.

Abstract:Formation maintenance and collision avoidance allow multiple agents to form and maintain a specific formation in the environment and reach the final goal safely without any collisions, which are important component of the multi-agent/crowd cooperation field. We propose a two-level formation control method to simulate crowd formation. At the low level, a comprehensive group reward function is designed to train the agents to learn to collaborate to reach the goal and avoid collisions with other agents and obstacles. The Multi-Agent POsthumous Credit Assignment algorithm and curriculum learning are combined to solve the credit assignment problem in the shared group reward and the slow convergence problem of the policy in the reward-sparse environment. At the high level, we design a formation switch method to determine the compression or splitting of the formation for multiple agents passing through the narrow exit. Then the optimal reciprocal collision avoidance algorithm is adopted to compute a collision-free velocity for the team of multiple agents, on the basis of which the desired formation positions are calculated to avoid collisions between the team and the obstacles in the environment. Lastly, Hungarian algorithm is utilized to assign the formation positions to the agents as their respective target position to accelerate the process of forming. Experimental results demonstrate that our proposed approach enable multiple agents to constitute the formation shape from the starting positions quickly and maintain the shape well when moving toward the final goal. Furthermore, our model has a certain generalization ability to unseen formation shapes in the scenarios without and with obstacles.

Abstract:This article studies a formation control problem for a group of heterogeneous, nonlinear, uncertain, input-affine, second-order agents modeled by a directed graph. The study compares its results with two others to assess the effectiveness and efficiency of the proposed method.

Abstract:This paper investigates the consensus-based formation control problem for multi-agent systems with unknown nonlinear dynamics. To achieve the desired formation, we propose two formation controllers to achieve the desired formation, one based on system states and the other on system outputs. The proposed controllers utilize adaptive gains to avoid global information and neural networks to estimate and compensate for nonlinearities. The proposed event-triggered schemes avoid continuous communication among agents and exclude the Zeno behavior. Stability analysis reveals that formation errors are bounded, and numerical simulations are used to validate the effectiveness of the proposed approaches.

Abstract:The development of artificial intelligence systems is transitioning from creating static, task-specific models to dynamic, agent-based systems capable of performing well in a wide range of applications. We propose an Interactive Agent Foundation Model that uses a novel multi-task agent training paradigm for training AI agents across a wide range of domains, datasets, and tasks. Our training paradigm unifies diverse pre-training strategies, including visual masked auto-encoders, language modeling, and next-action prediction, enabling a versatile and adaptable AI framework. We demonstrate the performance of our framework across three separate domains -- Robotics, Gaming AI, and Healthcare. Our model demonstrates its ability to generate meaningful and contextually relevant outputs in each area. The strength of our approach lies in its generality, leveraging a variety of data sources such as robotics sequences, gameplay data, large-scale video datasets, and textual information for effective multimodal and multi-task learning. Our approach provides a promising avenue for developing generalist, action-taking, multimodal systems.

Consensus Formation Among Mobile Agents in Networks of Heterogeneous Interaction Venues

Abstract:Exploring the collective behavior of interacting entities is of great interest and importance. Rather than focusing on static and uniform connections, we examine the co-evolution of diverse mobile agents experiencing varying interactions across both space and time. Analogous to the social dynamics of intrinsically diverse individuals who navigate between and interact within various physical or digital locations, agents in our model traverse a complex network of heterogeneous environments and engage with everyone they encounter. The precise nature of agents internal dynamics and the various interactions that nodes induce are left unspecified and can be tailored to suit the requirements of individual applications. We derive effective dynamical equations for agent states which are instrumental in investigating thresholds of consensus, devising effective attack strategies to hinder coherence, and designing optimal network structures with inherent node variations in mind. We demonstrate that agent cohesion can be promoted by increasing agent density, introducing network heterogeneity, and intelligently designing the network structure, aligning node degrees with the corresponding interaction strengths they facilitate. Our findings are applied to two distinct scenarios: the synchronization of brain activities between interacting individuals, as observed in recent collective MRI scans, and the emergence of consensus in a cusp catastrophe model of opinion dynamics.

Flocking Coordination Of Multiple Interactive Dynamical Agents With Switching Topology

Abstract:In this paper, we consider a group of mobile agents moving in the space with point mass dynamics. We investigate the dynamic properties of the group for the case where the topology of the neighboring relations between agents varies with time. Under the assumption that the neighboring graph is always connected, we show that stable Hocking motion can be achieved by using a set of switching control laws. The control laws are a combination of attractive/repulsive and alignment forces. Using the control laws, all agent velocities become asymptotically the same, collisions can be avoided between the agents, and the final tight formation minimizes all agent potentials. Moreover, we show that the velocity of the center of mass is invariant and is equal to the final common velocity. Subsequently, we study the motion of the group when the velocity damping is taken into account. In this case, we can appropriately modify the control laws to generate the same stable Hocking motion. Finally, we provide some numerical simulations to further illustrate our theoretical results.
Deep learning reveals hidden interactions in complex systems

Abstract:Rich phenomena from complex systems have long intrigued researchers, and yet modeling system micro-dynamics and inferring the forms of interaction remain challenging for conventional data-driven approaches, being generally established by human scientists. In this study, we propose AgentNet, a model-free data-driven framework consisting of deep neural networks to reveal and analyze the hidden interactions in complex systems from observed data alone. AgentNet utilizes a graph attention network with novel variable-wise attention to model the interaction between individual agents, and employs various encoders and decoders that can be selectively applied to any desired system. Our model successfully captured a wide variety of simulated complex systems, namely cellular automata (discrete), the Vicsek model (continuous), and active Ornstein--Uhlenbeck particles (non-Markovian) in which, notably, AgentNet's visualized attention values coincided with the true interaction strength and exhibited collective behavior that was absent in the training data. A demonstration with empirical data from a flock of birds showed that AgentNet could identify hidden interaction ranges exhibited by real birds, which cannot be detected by conventional velocity correlation analysis. We expect our framework to open a novel path to investigating complex systems and to provide insight into general process-driven modeling.

Abstract:Formation flight holds significant potential for various applications involving aerial robot swarms. However, current methodologies lack the capability to autonomously execute large-scale formation flights in densely populated environments. To bridge the gap, a decentralized and asynchronous formation flight planner is proposed based on a graph-based formation metric and tight representations of kino-dynamically feasible trajectories for collision avoidance. The planner handles formation path planning along with dynamic obstacles and intervehicle collision avoidance using minimum volume convex hulls for agent trajectories. The employed formation metric is invariant to rotation, translation, and scaling, granting greater flexibility in formation coordination. A decoupled and distributed trajectory optimization framework is proposed to enhance the computational feasibility of large-scale formation flights. Moreover, to mitigate issues relating to communication delays between agents, asynchronous execution of a finite horizon navigation framework with usage of sparse trajectory control points for trajectory segments is employed. Simulations with multiple agents, static and dynamic obstacles support the robustness of the planner to formation flights in real world. The planner demonstrates goal/waypoints achievement and formation adherence capabilities that are assessed and compared using a popular quantifiable formation similarity metric. Furthermore, the paper also serves as a guideline to build upon trajectory planning frameworks for tight formation control in cluttered, dynamic environments.

Abstract:As an important approach of distributed artificial intelligence, multi-agent system provides an efficient way to solve large-scale computational problems through high-parallelism processing with nonlinear interactions between the agents. However, the huge capacity and complex distribution of the individual agents make it difficult for efficient hardware construction. Here, we propose and demonstrate a multi-agent hardware system that deploys distributed Ag nanoclusters as physical agents and their electrochemical dissolution, growth and evolution dynamics under electric field for high-parallelism exploration of the solution space. The collaboration and competition between the Ag nanoclusters allow information to be effectively expressed and processed, which therefore replaces cumbrous exhaustive operations with self-organization of Ag physical network based on the positive feedback of information interaction, leading to significantly reduced computational complexity. The proposed multi-agent network can be scaled up with parallel and serial integration structures, and demonstrates efficient solution of graph and optimization problems. An artificial potential field with superimposed attractive/repulsive components and varied ion velocity is realized, showing gradient descent route planning with self-adaptive obstacle avoidance. This multi-agent network is expected to serve as a physics-empowered parallel computing hardware.
Top-Down Synthesis of Multi-Agent Formation Control: An Eigenstructure Assignment based Approach

Abstract:We propose a top-down approach for formation control of heterogeneous multi-agent systems, based on the method of eigenstructure assignment. Given the problem of achieving scalable formations on the plane, our approach globally computes a state feedback control that assigns desired closed-loop eigenvalues/eigenvectors. We characterize the relation between the eigenvalues/eigenvectors and the resulting inter-agent communication topology, and design special (sparse) topologies such that the synthesized control may be implemented locally by the individual agents. Moreover, we present a hierarchical synthesis procedure that significantly improves computational efficiency. Finally, we extend the proposed approach to achieve rigid formation and circular motion, and illustrate these results by simulation examples.
