Abstract:Under the dual−carbon goal, the research on energy conservation and emission reduction of new energy vehicles has once again become a current hotspot, and plug−in hybrid electric vehicles (PHEVs) are the first to bear the brunt. In order to improve the fuel economy of PHEV, an adaptive energy management strategy is designed on the basis of the intelligent prediction of driving cycles. Firstly, according to the vehicle dynamics model, the optimal control objective function of PHEV is established, and the relationship between vehicle fuel consumption and driving cycle is analyzed. Secondly, the initial weights and threshold of the backpropagation (BP) neural network are optimized using the particle swarm optimization (PSO) algorithm, and a PSO−BP neural network vehicle velocity prediction controller is established. Thirdly, combined with the approximate equivalent consumption minimization strategy (ECMS) algorithm to calculate the optimal initial equivalent factor in the prediction time domain, the fast−planning SOC and PI control are introduced to determine the optimal equivalent factor sequence, and the optimal torque distribution ratio of the engine and motor is calculated. Lastly, three different energy management strategies are simulated and verified under six China light−duty vehicle test cycle−passenger car (6*CLTC−P) driving cycles. Simulation results show that the established velocity prediction model has good prediction accuracy, and the proposed adaptive energy management strategy based on prediction is 9.85% higher than the rule−based strategy in terms of fuel saving rate and 5.30% higher than the ECMS strategy without prediction, which further improves the fuel saving potential of PHEV.

Abstract:<p>This paper proposes a real-time predictive energy management strategy (PEMS) of plug-in hybrid electric vehicles for coordination control of fuel economy and battery lifetime, including velocity predictor, state-of-charge (SOC) reference generator, and online optimization. In velocity predictor, the radial basis function neural network algorithm is adopted to accurately estimate the future drive velocity. Based on predictive velocity and current driven distance, the SOC reference in predictive horizon can be determined online by reference generator. To coordinate fuel consumption and battery degradation, a model predictive control problem of cost minimization including fuel consumption cost, electricity cost of battery charging/discharging, and equivalent cost of battery degradation, is formulated. To mitigate the huge calculation burden in optimization, the continuation/generalized minimal residual (C/GMRES) algorithm is delegated to find the expected engine power command in real time. Since original C/GMRES algorithm cannot directly handle inequality constraints, the external penalty method is employed to meet physical inequality limits of powertrain. Numerical simulations are carried out and yield the desirable performance of the proposed PEMS in fuel consumption minimization and battery aging restriction. More importantly, the proposed C/GMRES algorithm shows great solving quality and real-time applicability in PEMS by comparing with sequence quadratic programming and genetic algorithms.</p>

Abstract:The speed of a hybrid electric vehicle is a critical factor that affects its energy management performance. In this study, we focus on the importance of solving the problem of inaccurate speed prediction in the energy management strategy (EMS) and application of dynamic programming (DP) needs to know the entire driving cycle. A gated recurrent unit neural network (GRU-NN) speed predictive model based on machine learning is developed by using the model predictive control (MPC) framework and solved in the prediction domain by employing DP. The neural network is trained on the training set, which is a collection of standard driving cycles. The results are compared with other two types of speed predictive models to verify the effects of different parameters of different speed predictive models on the state of charge and fuel consumption under Urban Dynamometer Driving Schedule driving cycle. Simulation shows that MPC based on the GRU-NN speed predictive model can effectively improve the fuel economy of hybrid electric vehicles, with a 94.14% fuel economy, which proves its application potential. Finally, the GRU-NN speed predictive model is applied under the Real-World Driving Cycle, whose fuel consumption has a fuel economy of 91.95% compared with that of the original rule-based EMS.
Global optimization energy management for multi-energy source vehicles based on “Information layer - Physical layer - Energy layer - Dynamic programming” (IPE-DP)

Abstract:To reveal the energy-saving mechanisms of global energy management, we propose a global optimization framework of “information layer-physical layer-energy layer-dynamic programming” (IPE-DP), which can realize the unity of different information scenarios, different vehicle configurations and energy conversions. The deterministic dynamic programing (DP) and adaptive dynamic programming (ADP) are taken as the core algorithms. As a benchmark for assessing the optimality, DP strategy has four main challenges: standardization, real-time application, accuracy, and satisfactory drivability. To solve the above problems, the IPE-DP optimization framework is established, which consists of three main layers, two interface layers and an application layer. To be specific, the full-factor trip information is acquired from three scenarios in the information layer, and then the feasible work modes of the vehicle are determined in the physical layer based on the proposed conservation framework of “kinetic/potential energy & onboard energy“. The above lays a foundation for the optimal energy distribution in the energy layer. Then, a global domain-searching algorithm and action-dependent heuristic dynamic programming (ADHDP) model are developed for different information acquisition scenarios to obtain the optimal solution. To improve the computational efficiency under the deterministic information, a fast DP is developed based on the statistical rules of DP behavior, the core of which is to restrict the exploring region based on a reference SOC trajectory. Regarding the stochastic trip information, the ADHDP model is established, including determining the utility function, network design and training process. Finally, two case studies are given to compare the economic performance of the vehicle under different information acquisition scenarios, which lays a foundation for analyzing the relationship between the amount of information input and energy-saving potential of the vehicle. Simulation results demonstrate that the proposed method gains a better performance in both real-time performance and global optimality.

Abstract:In order to reasonably allocate the power needs and manage the energy of the plug-in hybrid electric vehicle (PHEV) more efficiently, an energy management strategy (EMS) based on deep learning and improved model predictive control was proposed. Firstly, the vehicle energy flow test was carried out for the PHEV, and the multi-physics (mechanical-electrical-thermal-hydraulic) model was constructed and validated. Secondly, six prediction models were built based on different algorithms and the effects were compared and analyzed in detail. Finally, a long short-term memory based improved model predictive control algorithm (LSTM-IMPC) was developed, and the effects of three EMSs based on the charge-depleting charge-sustaining rule (CD-CS), dynamic programming (DP) and LSTM-IMPC were investigated under Worldwide Light-duty Test Cycle (WLTC), New European Driving Cycle (NEDC) and real driving cycle (RDC). The results show that the fuel-saving rates of the LSTM-IMPC-based EMS under these three cycles are respectively 3.81%, 5.6% and 18.71% compared with the CD-CS-based EMS, which prove the good fuel-saving performance and strong robustness of the proposed EMS. The fuel-saving rates of the LSTM-IMPC-based EMS are close to the DP-based EMS, which are the global optimal under these three cycles.

Abstract:Eco-driving technology is an effective way for connected and automated plug-in hybrid electric vehicles (CAPHEVs) to achieve energy conservation and emission reduction. However, the constraints of traffic flows and signal lights at intersections pose serious challenges to eco-driving of CAPHEVs. Therefore, an eco-driving control method based on dynamic consumption prediction is proposed. A hierarchical control scheme is designed that divides eco-driving problem into global velocity planning and energy management. Firstly, a multistage time-series prediction model is constructed based on two long short-term memory networks, which is applied to predict optimal energy consumption cost. Secondly, the velocity trajectory in global speed planning is optimized by combining the multistage consumption prediction model with dynamic programming. Finally, an energy management strategy considering energy consumption and pollutant emission is proposed. The real-world environment information is applied to construct the virtual simulation environment and verify the proposed method. The simulation results demonstrate that the proposed multistage prediction model has a better prediction performance than the existing popular models. Meanwhile, the total cost savings by the proposed scheme range from 13.5% to 48.7%. Particularly, the proposed method not only significantly reduces emissions, but also guarantees driving safety, and satisfies the different demands for travel time.

Abstract:Range-extended electric vehicles combine the benefits of electric propulsion with the convenience and range flexibility of conventional internal combustion engine vehicles. In the energy management system, an equivalent consumption minimization strategy (ECMS) ensures balanced utilization of various energy sources to meet driving demand in real time, thereby enhancing energy efficiency. This paper proposes a driving pattern personalized reconstruction (DPPR) method to maximizes the accuracy of velocity prediction and to serve a predictive ECMS (P-ECMS) with high adaptability to uncertain scenarios. In this context, open-source driving cycles are segmented, and features of each driving pattern are extracted for cluster analysis. Utilizing the results from clustering, new driving cycles are reconstructed for the purpose of training adaptive neuro-fuzzy inference system (ANFIS) models. Personalized velocity prediction is achieved through bias fusion in the multi-ANFIS model, adapting to various driving conditions. The performance of the proposed P-ECMS is validated across various driving conditions and compared with conventional ECMS (C-ECMS), adaptive ECMS (A-ECMS), dynamic programming (DP), and fuzzy logic (FL) strategy. The results indicate that using the proposed P-ECMS is strongly robust in terms of battery pack SoC stabilization under various driving conditions, whose SoC difference achieves 97.02% of using the DP strategy. Compared to using other strategies, using P-ECMS achieves better SoC's stability and lower fuel consumption than using the FL strategy (11.1%), using A-ECMS (1.7%), and using C-ECMS (26.6%).

Abstract:Energy management strategies play a crucial role in enhancing the fuel efficiency of hybrid electric vehicles (HEVs) and mitigating greenhouse gas emissions. For the current commonly used time horizon optimization methods that only target the trend curve of the optimal battery state of charge (SOC) trajectory obtained offline, which are only suitable for buses with known future driving conditions, this paper proposed an energy management strategy based on an adaptive network-based fuzzy inference system (ANFIS) that optimizes the time horizon length and enhances adaptability to driving conditions by integrating historical vehicle velocity, accelerations, and battery SOC trajectory. First, the vehicle velocity prediction model based on the radial basis function (RBF) neural network is used to predict the future velocity sequence. After that, ANFIS was used to optimize and update the length of the forecast time horizon based on the historical vehicle velocity sequence. Finally, compared with the fixed time horizon energy management strategy, which is based on model predictive control (MPC), the average calculation time of the energy management strategy is reduced by about 23.5%, and the fuel consumption per 100 km is reduced by about 6.12%.

Abstract:Fuel cell hybrid electric vehicles (FCHEVs) are widely considered to be an ideal substitute for the traditional vehicles. However, their high costs of operation make them uncompetitive in the current automotive market. To maximize the economy of fuel cell/battery-based hybrid electric vehicles, herein, integrating with speed prediction model, a dynamic programming solver model predictive control (DPS-MPC) strategy is applied for the hybrid vehicle energy management . The main principle of the proposed DPS-MPC is to obtain the manipulated variable that minimizes the vehicle operating cost by using the DP solver according to the information of state variables and disturbance variable. Assisted by the predictive vehicle speed, the future demand power of the vehicle is acquired by vehicle dynamic model. The demand power imports into the energy management system response prediction model for improving the control performance by considering more exact disturbance. Additionally, a comparative study is conducted to verify the improvement of economic performance by proposed strategy. The results indicate that DPS-MPC strategy can respectively reduce the operating cost by 21 % in average versus a normal MPC strategy. Moreover, the average computing time per step is 9.27 ms, less than the sampling time 1 s. In order to verify the real-time performance of the DPS-MPC strategy, a hardware in the loop test is conducted.

Abstract:To achieve the optimal energy allocation for the engine-generator, battery and ultracapacitor of a plug-in hybrid electric vehicle, a novel adaptive energy management strategy has been proposed. Three efforts have been made. First, the hierarchical control strategy has been proposed for multiple energy sources from a multi-scale view. The upper level is for regulating the energy between the engine-generator and hybrid energy-storage system, while the lower level is for the battery and ultracapacitor. Second, a driving pattern recognition based adaptive energy management approach has been proposed. This approach uses a fuzzy logic controller to classify typical driving cycles into different driving patterns and to identify the real-time driving pattern. Dynamic programming has been employed to develop optimal control strategies for different driving blocks, and it is helpful for realizing the adaptive energy management for real-time driving cycles. Third, to improve the real-time and robust performance of the energy management, the previous 100s duration of historical information has been determined to identify a real-time driving pattern. Finally, an adaptive energy management strategy has been proposed. The simulation results indicate that the proposed energy management strategy has better fuel efficiency than the original and conventional dynamic programming-based control strategies.

Abstract:The energy economy of fuel cell electric vehicles (FCEVs) plays a crucial role in determining their practicality, making the optimization of energy management strategies (EMS) essential. Predictive EMS (PEMS) based on future vehicle speed prediction offers great potential for enhancing EMS performance. However, current PEMS prediction models rely on historical speed data or static traffic information, overlooking the impact of real-time traffic conditions. In this paper, we introduce a Transformer-based PEMS (TPEMS) that incorporates real-time predicted surrounding traffic information to improve FCEV operational economy. To better predict vehicle speed by accounting for the complex interactions between the controlled vehicle and surrounding vehicles, we developed a Transformer network-based predictor, which considers the speed and relative distance of six vehicles surrounding the controlled vehicle, generating speed predictions for the next 10 seconds. We then employ the deep reinforcement learning (DRL) method as a downstream optimizer, creating a fully data-driven PEMS. For training the TPEMS, we developed a dataset derived from the NGSIM dataset, consisting of numerous driving profile segments that include temporal-sequential characteristics of the controlled vehicle and surrounding traffic. Furthermore, we utilize the SUMO simulator to generate a traffic information-enabled driving profile for performance evaluation. Experimental results reveal our Transformer-based predictor outperforms existing predictors, i.e., recurrent neural networks (RNN), in processing traffic information and achieving improved predictions. The TPEMS enhances the economic efficiency of FCEVs by 4.6% relative to the current state-of-the-art long short-term memory (LSTM)-based PEMS.

Abstract:In the research on energy management methods of plug-in hybrid electric vehicles, it is expected that a future trend will be to optimize energy management using the information provided by the global positioning system (GPS) and intelligent transportation system (ITS), which is relatively scarce in current research. This study proposes a PHEV energy management method based on travel characteristic prediction. Firstly, this study processes the historical travel data of a certain driver obtained by GPS and ITS and uses the established Markov trajectory prediction model based on key points to predict the trajectory and mileage. Then, on the basis of characteristics analysis of historical travel data, while considering traffic information to form a target cycle, the driving cycles are classified and identified based on traffic information predictions. Then, according to the reasonable SOC allocation range of the four typical cycles, the planning algorithm of the SOC reference trajectory is determined and verified. Finally, based on the previous work, an A-ECMS energy management method based on travel characteristic prediction is established. By comparing different energy management methods, the developed energy management method based on travel characteristic prediction can reasonably utilize power batteries. The fuel saving is about 8.95% higher than the rule-based energy management method, which can effectively improve the whole vehicle’s fuel economy and optimization ability.

Abstract:Energy management strategies determine how much energy is consumed by the engine and electric motor of plug-in hybrid electric buses (PHEBs), which represent critical fuel-saving technologies. In this study, a model predictive control (MPC) method with the estimation of distribution algorithm (EDA) as the solver is proposed to optimize the energy flow of PHEBs. Inspired by the recursive mechanism, short-term velocity prediction is achieved based on a Markov chain model with online updates to greatly improve prediction accuracy. Then, the energy-flow control problem of PHEBs is formulated as a discrete-time nonlinear optimization problem. Due to its strong nonlinear multivariable and constrained nature, the control algorithm is implemented by using MPC. To obtain an optimal solution efficiently, the EDA algorithm is incorporated into the MPC-based control framework, in which the Gaussian distribution is selected as a probabilistic model to characterize the candidate solutions and make full use of the statistical information extracted from the search experience. All performance verifications were conducted by theoretical simulation and hardware-inthe-loop. The verification results show that the proposed strategy can greatly improve the fuel economy and the shorten computational time over cycle-based driving.

Abstract:With the development of intelligent transportation systems, access to diverse transportation information has become possible. Integrating this information into an energy management strategy will make the energy allocation prospective and thus improve the overall performance of the energy management program. For this reason, this paper proposes a hierarchical model predictive control (MPC) energy management strategy that incorporates traffic information, where the upper layer plans the vehicle's velocity based on the traffic information and the lower layer optimizes the energy distribution of the vehicle based on the planned velocity. In order to improve the accuracy of the planning speed of the upper strategy, a dung beetle optimization-radial basis function (DBO-RBF) prediction model is constructed, artfully optimizing the RBF neural network using the dung beetle optimization algorithm. The results show that the prediction accuracy is improved by 13.96% at a prediction length of 5 s. Further, when the vehicle passes through a traffic light intersection, the traffic light information is also considered in the upper strategy to plan a more economical speed and improve the traffic efficiency of the vehicle and traffic utilization. Finally, a dynamic programming (DP)-based solver is designed in the lower layer of the strategy, which optimizes the energy distribution of the vehicle according to the velocity planned by the upper layer to improve the economy of the vehicle. The results demonstrate achieving a noteworthy 3.97% improvement in fuel economy compared to the conventional rule-based energy management strategy and allowing drivers to proceed through red light intersections without stopping. This proves a substantial performance enhancement in energy management strategies resulting from the integration of transportation information.

Abstract:<p>In this paper, an energy management strategy (EMS) based on model predictive control (MPC) is proposed to minimize fuel cost, electricity usage and battery ageing. To fulfil the MPC framework, a novel speed predictor with a variable horizon based on a K-means algorithm and a radius basis function neural network, which contains various predictive submodels, is designed to cope with different input drive states. In addition, a Q-learning algorithm is applied to construct an adaptive multimode state-of-charge (SOC) reference generator, which takes advantage of velocity forecasts for each prediction horizon. The algorithm fully considers the model nonlinearities and physical constraints and requires less computational effort. Based on the SOC reference and predictive velocity, the MPC problem is formulated to coordinate fuel consumption and battery degradation. Moreover, considering the influence of real-time traffic information, a traffic model that simulates actual road conditions is constructed in VISSIM to evaluate the performance of the proposed EMS. The simulation results show that the proposed speed predictor can effectively improve the predictive accuracy, and the multimode control laws based on drive condition classification present superior adaptability in SOC reference generation compared to single-mode law. With the aforementioned two improvements, the proposed EMS achieves desirable performance in fuel economy and battery lifetime extension.</p>

Abstract:Powertrain electrification incorporating advanced combustion-based dedicated hybrid engines (DHEs) is an effective and affordable approach to automotive energy saving. To explore the concealed fuel-saving potential of connected plug-in hybrid electric vehicles (CPHEVs) and manage engine dynamics, a data-driven predictive energy consumption minimization strategy (D-PECMS) is proposed in a hierarchical framework. The strategy relies on multi-source trip information provided by advanced driving assistance systems (ADAS) combined with maps and realizes power demand prediction by designing a multivariable long-term and short-term memory (M-LSTM) network. The upper level adopts dynamic programming (DP) to realize SOC planning, while the bottom layer utilizes D-PECMS to achieve computationally-efficient energy management with the engine combustion process being regulated in transient. This strategy is featured with predictive SOC tracking ability with less computational burden and look-ahead engine start-stop control. To ensure the credibility of validation, bench test data are used from a high-efficiency spark-induced compression ignition (SICI) engine to model the CPHEV, and the real-world driving scenarios are reconstructed based on real-time traffic data collected in China. The proposed D-PECMS strategy is tested through comprehensive experiments and compared against both the adaptive ECMS and offline DP. The results demonstrate that the proposed strategy effectively reduces fuel consumption by 3.1% and 13.2% in contrast to the adaptive ECMS and rule-based control respectively. Moreover, the D-PECMS strategy successfully avoids frequent engine operation mode switching as well as engine startup and shutdown.

Abstract:This article proposes a stochastic predictive energy management strategy based on fast rolling optimization for plug-in hybrid electric vehicles (PHEVs). First, combined with a large number of real-world driving cycle data, the stochastic driving behaviors are modeled as probability transition matrices of vehicle demand torque based on Markov chains. Secondly, to solve the torque split problem in parallel hybrid powertrain, the stochastic model predictive control (SMPC) framework is built. Thirdly, the continuation/generalized minimum residual algorithm is employed to execute the fast rolling optimization. The effectiveness of the proposed strategy is validated in both simulations and test bench, and its performance is compared with the SMPC by dynamic programming (DP) optimization and the equivalent minimum fuel consumption strategy (ECMS). Simulation results show that under real-world driving cycle, PHEV using the proposed strategy could obtain 4.8% energy consumption reduction comparing with that uses ECMS. In terms of computational time, the proposed strategy dramatically reduces the running time comparing with that of SMPC by DP optimization. Furthermore, the similar results can be obtained in the experiment. Under real-world driving cycle, 4.6% fuel economy improvement is obtained using the proposed strategy compared with that using ECMS, which clearly shows that the proposed strategy is effective.

Abstract:Driving cycles and road slope are two important factors affecting fuel saving performance of plug-in hybrid electric buses (PHEBs) in Chinese cities. Moreover, onboard auxiliary equipment (e.g., Global Position System receiver and General Packet Radio Service (GPRS) wireless module) of PHEB may provide potential means to communicate with the control center of the bus company, allowing for driving cycle prediction through data communication between foregoing buses and the control center. With this general approach in mind, and by utilizing driving data clustering and driving cycle classifier, this paper presents a multimode switched logic control strategy, targeting fuel economy improvement of the PHEB team for a particular city bus route. First, the normal feature parameters are extracted from the sampled driving history cycles, and the composed feature parameters are given by a mapping of normal feature parameters in this approach. A novel improved hierarchical clustering algorithm is applied for driving cycles' data clustering into four groups. Then, on the basis of the clustering results, support vector machine method is used to predict the current driving cycle. Finally, a switched driving controller is presented according to current type of driving cycle and slope information. Simulation results are compared with those of traditional methods in the given real-world driving cycles of city bus, showing significant improvement, which may offer a theoretical solution with engineering application. Experimental results also demonstrate that the proposed control approach is feasible in the tested bus routes.

Abstract:Precise prediction of future vehicle information can improve the control efficiency of hybrid electric vehicles. Nowadays, most prediction models use previous information of vehicles to predict future driving velocity, which cannot reflect the impact of the driver and the environment. In this paper, a real-time energy management strategy (EMS) based on driver-action-impact MPC is proposed for series hybrid electric vehicles. The proposed EMS consists of two modules: the velocity prediction module and the real-time MPC module. In the velocity prediction module, a long short-term memory (LSTM) neural network model, which is trained by the traffic data derived from a VR-based driving simulator, is adopted to predict the future driving information by using driver action information and current vehicle’s velocity. The obtained future driving velocity is treated as the inputs of the real-time MPC module, which outputs the control variables to act on the underlying controllers of power components by solving a standard quadratic programming (QP) problem. Compared with the rule-based strategy, a 5.6% average reduction of fuel consumption is obtained. The effectiveness of real-time computation of the EMS is validated and verified through a hardware-in-the-loop test platform.

Abstract:Hybrid electric vehicles that can combine the advantages of traditional and new energy vehicles have become the optimal choice at present in the face of increasingly stringent fuel consumption restrictions and emission regulations. Range-extended hybrid electric vehicles have become an important research topic because of their high energy mixing degree and simple transmission system. A compact traditional fuel vehicle is the research object of this study and the range-extended hybrid system is developed. The design and optimization of the condition prediction energy management strategy are investigated. Vehicle joint simulation analysis and bench test platforms were built to verify the proposed control strategy. The vehicle tracking method was selected to collect real vehicle driving data. The number of vehicles in the field of view and the estimation of the distances between the front and following vehicles are calculated by means of the mature algorithm of the monocular camera and by computer vision. Real vehicle cycle conditions with driving environment and slope information were constructed and compared with all driving data, typical working conditions under NEDC, and typical working conditions under UDDS. The BP neural network and fuzzy logic control were used to identify the road conditions and the driver's intention. The results showed that the equivalent fuel consumption of the control strategy was lower than that of the fixed-point power following control strategy and vehicle economy improved.
