Abstract:We present a fatigue prediction model for motion sensing games, dependent on the change of physiological signals including blood volume pulse, skin conductance, respiration, skin temperature and electromyography (EMG). After extracting a range of features followed by using sequential floating forward selection (SFFS) to select features, support vector regression (SVR) was used to construct our prediction model that can predict how long participants enter fatigue states. The root mean square error (RMSE) and the relative root square error (RRSE) of our model are respectively 198.36s and 0.51 for subject-dependent, and 522.94s and 0.97 for subject-independent. The results indicate each subject has individualized physiological pattern when they felt fatigue.
A Forecasting Framework for Predicting Perceived Fatigue: Using Time Series Methods to Forecast Ratings of Perceived Exertion with Features from Wearable Sensors

Abstract:Advancements in sensing and network technologies have increased the amount of data being collected to monitor the worker conditions. In this study, we consider the use of time series methods to forecast physical fatigue using subjective ratings of perceived exertion (RPE) and gait data from wearable sensors captured during a simulated in-lab manual material handling task (Lab Study 1) and a fatiguing squatting with intermittent walking cycle (Lab Study 2). To determine whether time series models can accurately forecast individual response and for how many time periods ahead, five models were compared: naïve method, autoregression (AR), autoregressive integrated moving average (ARIMA), vector autoregression (VAR), and the vector error correction model (VECM). For forecasts of three or more time periods ahead, the VECM model that incorporates historical RPE and wearable sensor data outperformed the other models with median mean absolute error (MAE) <1.24 and median MAE <1.22 across all participants for Lab Study 1 and Lab Study 2, respectively. These results suggest that wearable sensor data can support forecasting a worker's condition and the forecasts obtained are as good as current state-of-the-art models using multiple sensors for current time prediction.

Abstract:Fatigue is a loss in cognitive or physical performance due to physiological factors such as insufficient sleep, long work hours, stress, and physical exertion. It adversely affects the human body and can slow reaction times, reduce attention, and limit short-term memory. Hence, there is a need to monitor a person's state to avoid extreme fatigue conditions that can result in physiological complications. However, tools to understand and assess fatigue are minimal. This paper primarily focuses on building an experimental setup that induces cognitive fatigue (CF) and physical fatigue (PF) through multiple cognitive and physical tasks while simultaneously recording physiological data. First, we built a prototype sensor suit embedded with numerous physiological sensors for easy use during data collection. Second, participants' self-reported visual analog scores (VAS) are reported after each task to confirm fatigue induction. Finally, an evaluation system is built that utilizes machine learning (ML) models to detect states of CF and PF from sensor data, thus providing an objective measure. Our methods beat state-of-the-art approaches, where Random Forest performs the best in detecting PF with an accuracy of 80.5% while correctly predicting the true PF condition 88% of the time. On the other hand, the long short-term memory (LSTM) recurrent neural network produces the best results in detecting CF in the subjects (with 84.1% accuracy, 0.9 recall).

Abstract:SUMMARY The relative efficiency of several methods of studying genotype-environment interactions has been illustrated, considering some performance traits in laying hens as a model. The comparison involved methods of classifying, detecting the existence, and estimating the magnitude of genotype-environment interactions. The environments consisted of warm (32 °C) and temperate (20 °C) climatic conditions. Classification and qualitative description of interactions is useful when very few genotypes and environments are involved. The illustration with an example suggested that a classification based on comparison of relative magnitudes of average genotypic, environmental and interaction effects would be most meaningful. The interactions carry greater significance if they exceed the average genotypic effects. A factorial analysis of variance followed by an F-test can be useful in detecting the existence of interactions, but statistical significance should not be overemphasized for biological relevance. Invariably, the magnitude of interactions must be estimated to derive useful conclusions. The seven methods of estimating this correlation mainly involved principles of intraclass correlation, rank correlation and product-moment correlation. An analysis of data revealed that the intraclass correlation methods, in general, yielded higher estimates compared to the rest of the methods. Among them, the formula given by Dickerson (1962) was found more appropriate in mixed-model analysis with unbalanced data, while the method given by Yamada (1962) resulted in negative estimates when the interaction variance was large. The least reliable among the methods were estimations directly utilizing the mean squares from factorial analysis of variance as suggested by Robertson (1959). Rank correlations were similar for phenotypic as well as genetic rankings and also coincided to some extent with the correlation among the breeding values, revealing distinct changes in ranks of genotypes in those traits where the interactions were larger. Product-moment correlations between the breeding values of sires in the two environments should be the most reliable and suitable for predicting selection response when the sires are selected in one environment and their progeny is required to perform under different conditions. However, their expectations were lower than 1, depending upon the genetic foundation of the traits and effective progeny size. ZUSAMMENFASSUNG: Verschiedene Methoden der Untersuchung von Genotyp-Umwelt-Interaktionen hinsichtlich ihrer relativen Effizienz wurden verglichen. Dieser Vergleich erfolgte modellhaft an Leistungsmerkmalen von Legehennen. Die angewandten Methoden beinhalten solche des Nachweises, der Klassifizierung und der Schätzung des Ausmaßes von Genotyp-Umwelt-Interaktionen. An Umweltbedingungen wurden warme (32°) und gemäßigte (20°C) Stalltemperaturen einbezogen. Die Klassifizierung und qualitative Beschreibung von Interaktionen ist immer dann besonders geeignet, wenn nur sehr wenige Genotypen und Umwelten berücksichtigt werden müssen. Die Beispielsberechnungen ergaben, daß eine Klassifizierung aufgrund eines Vergleiches des relativen Ausmaßes der Durchschnittseffekte von Genotypen, Umwelten und der Interaktionseffekte am sinnvollsten ist. Die Interaktionen zeigten immer dann stärkere Ausprägung, wenn sie die Durchschnittseffekte der Genotypen übertrafen. Eine faktorielle Varianzanalyse ist in Verbindung mit einem F-Test geeignet, das Auftreten von Interaktionen nachzuweisen. Von der statistischen Signifikanz kann jedoch nicht direkt auf biologische Relevanz geschlossen werden. Um züchterische Konsequenzen ziehen zu können, muß das Ausmaß von Interaktionen geschätzt werden. Es wurden sieben Schätzmethoden auf der Basis der Berechnung von Intraklasskorrelationen, Rangkorrelationen und Produkt-Moment-Korrelationen angewandt. Mit den Intraklasskorrelationsmethoden wurden allgemein die höchsten Schätzwerte ermittelt. Dabei erwies sich die Formel von Dickerson (1962) als geeigneter für Analysen im gemischten Modell mit unbalanzierten Daten, während die Methode von Yamada (1962) immer dann zu negativen Schätzwerten führte, wenn die Interaktionsvarianz hoch war. Am wenigsten zuverlässig waren die Schätzwerte nach Robertson (1959), die direkt aus den Durchschnittsquadraten der faktoriellen Varianzanalyse ermittelt wurden. Bezüglich der Rangkorrelationen ergaben sich ähnliche Ergebnisse nach phänotypischer und genetischer Rangierung und eine annähernde Übereinstimmung mit den Korrelationen zwischen den Zuchtwerten. Es traten in all jenen Merkmalen deutliche Rangverschiebungen auf, für die höhere Interaktionen erwartet wurden. Produkt-Moment-Korrelationen zwischen den Zuchtwerten der Väter in den beiden Umwelten ergaben die zuverlässigsten Schätzwerte und ermöglichten die besten Voraussagen des Selektionserfolges für den Fall, daß die Väter in einer Umwelt selektiert werden, während ihre Nachkommen unter anderen Bedingungen produzieren müssen. Die Erwartungswerte dieser Korrelationen können jedoch kleiner als 1 sein und hängen sowohl von der genetischen Fundierung der Merkmale als auch von der Anzahl geprüfter Nachkommen ab.
Real-time forecasting of exercise-induced fatigue from wearable sensors

Abstract:Although a number of studies attempt to classify human fatigue, most models can only identify fatigue after fatigue has already occurred. In this paper, we propose a novel time series approach to forecasting wearable sensor data and associated fatigue progression during exercise. The proposed framework consists of spatio-temporal attention-based Transformer with an auxiliary critic and a fatigue classifier. The Transformer network is used to analyze the person-independent pattern underlying the past kinematic sequence obtained from wearable sensors and generate short term predictions of the human motion. Adversarial training is employed to regularize the Transformer and improve the time series forecasting performance. A fatigue classifier is used to estimate person-independent fatigue levels based on the forecasted wearable sensor data from the Transformer model. The proposed approach is validated with simulated and real squat datasets which were collected from young healthy participants. The proposed network can accurately forecast a time horizon of up to 80 timesteps for motion signal forecasting and fatigue classification. In terms of fatigue prediction, an accuracy of 83% and a Pearson correlation coefficient of 0.92 were achieved on forecasted motion data with unseen participant data. The experimental results show that our model can predict fatigue progression and outperforms other state-of-the-art techniques, achieving 95% correlation compared to 83% for the best performing baseline method. Successfully predicting fatigue progression can help a patient or athlete monitor and adjust their exercise session to prevent overexertion and fatigue-induced injury.

Abstract:Although running is a common leisure activity and a core training regiment for several athletes, between $29\%$ and $79\%$ of runners sustain an overuse injury each year. These injuries are linked to excessive fatigue, which alters how someone runs. In this work, we explore the feasibility of modelling the Borg received perception of exertion (RPE) scale (range: $[6-20]$), a well-validated subjective measure of fatigue, using audio data captured in realistic outdoor environments via smartphones attached to the runners' arms. Using convolutional neural networks (CNNs) on log-Mel spectrograms, we obtain a mean absolute error of $2.35$ in subject-dependent experiments, demonstrating that audio can be effectively used to model fatigue, while being more easily and non-invasively acquired than by signals from other sensors.

Towards Automated Fatigue Assessment using Wearable Sensing and Mixed-Effects Models

Abstract:Fatigue is a broad, multifactorial concept that includes the subjective perception of reduced physical and mental energy levels. It is also one of the key factors that strongly affect patients' health-related quality of life. To date, most fatigue assessment methods were based on self-reporting, which may suffer from many factors such as recall bias. To address this issue, in this work, we recorded multi-modal physiological data (including ECG, accelerometer, skin temperature and respiratory rate, as well as demographic information such as age, BMI) in free-living environments and developed automated fatigue assessment models. Specifically, we extracted features from each modality and employed the random forest-based mixed-effects models, which can take advantage of the demographic information for improved performance. We conducted experiments on our collected dataset, and very promising preliminary results were achieved. Our results suggested ECG played an important role in the fatigue assessment tasks.

Abstract:About 40% of the US construction workforce experiences high-level fatigue, which leads to poor judgment, increased risk of injuries, a decrease in productivity, and a lower quality of work. Therefore, it is essential to monitor fatigue to reduce its adverse effects and prevent long-term health problems. However, since fatigue demonstrates itself in several complex processes, there is no single standard measurement method for fatigue detection. This study aims to develop a system for continuous workers’ fatigue monitoring by predicting the aerobic fatigue threshold (AFT) using forearm muscle activity and motion data. The proposed system consists of five modules: Data acquisition, activity recognition, oxygen uptake prediction, maximum aerobic capacity (MAC) estimation, and continuous AFT monitoring. The proposed system was evaluated on the participants performing fourteen scaffold-building activities. The results show that the AFT features have achieved a higher accuracy of 92.31% in assessing the workers’ fatigue level compared to heart rate (51.28%) and percentage heart rate reserve (50.43%) features. Moreover, the overall performance of the proposed system on unseen data using average two-min AFT features was 76.74%. The study validates the feasibility of using forearm muscle activity and motion data to workers’ fatigue levels continuously.

Abstract:Cognitive fatigue is a psychological state characterised by feelings of tiredness and impaired cognitive functioning arising from high cognitive demands. This paper examines the recent research progress on the assessment of cognitive fatigue and provides informed recommendations for future research. Traditionally, cognitive fatigue is introspectively assessed through self-report or objectively inferred from a decline in behavioural performance. However, more recently, researchers have attempted to explore the biological underpinnings of cognitive fatigue to understand and measure this phenomenon. In particular, there is evidence indicating that the imbalance between sympathetic and parasympathetic nervous activity appears to be a physiological correlate of cognitive fatigue. This imbalance has been indexed through various heart rate variability indices that have also been proposed as putative biomarkers of cognitive fatigue. Moreover, in contrast to traditional inferential methods, there is also a growing research interest in using data-driven approaches to assessing cognitive fatigue. The ubiquity of wearables with the capability to collect large amounts of physiological data appears to be a major facilitator in the growth of data-driven research in this area. Preliminary findings indicate that such large datasets can be used to accurately predict cognitive fatigue through various machine learning approaches. Overall, the potential of combining domain-specific knowledge gained from biomarker research with machine learning approaches should be further explored to build more robust predictive models of cognitive fatigue.

Abstract:Fatigue detection based on electrocardiogram (ECG) from wearable devices is a convenient approach during exercise. However, how to model the data variations of ECG time series and capture effective information for accurate fatigue detection is still challenging. In this study, we propose a novel fatigue assessment architecture designed to adaptively extract and integrate both the ECG and heart rate variability (HRV) features, so as to obtain rich contextual information from ECG sequences and improve exercise-induced fatigue prediction performance. Inspired by the ECG observation process of human experts, the hierarchical transformer framework is designed to model the long-range dependencies of ECG time series and obtain multi-scale ECG representations. To reduce the computation cost, we also devise a sampling-efficient multi-head attention (SMA) mechanism. Finally, a novel gated feature fusion layer is developed to adaptively learn the weights of both the ECG and HRV features for fatigue prediction. The proposed fatigue prediction system is validated with real fatigue datasets which were collected from healthy participants. The experimental results show that the proposed approach outperforms other recent state-of-the-art systems in terms of accuracy 94.0%, specificity 99.0%, recall 89.3%, F1-score 93.7%, G-mean score 91.7%, MCC 0.837, and Cohen's Kappa 0.847, based on the ECG time series with duration 20s. This demonstrates that the proposed system can be used to accurately detect fatigue in real time during exercise, such that assisting coaches or athletes to monitor and adjust their exercise session for preventing overexertion and fatigue-induced injury.

Abstract:The educational environment plays a vital role in the development of students who participate in athletic pursuits both in terms of their physical health and their ability to detect fatigue. As a result of recent advancements in deep learning and biosensors benefitting from edge computing resources, we are now able to monitor the physiological fatigue of students participating in sports in real time. These devices can then be used to analyze the data using contemporary technology. In this paper, we present an innovative deep learning framework for forecasting fatigue in athletic students following physical exercise. It addresses the issue of lack of precision computational models and extensive data analysis in current approaches to monitoring students' physical activity. In our study, we classified fatigue and non-fatigue based on photoplethysmography (PPG) signals. Several deep learning models are compared in the study. Using limited training data, determining the optimal parameters for PPG presents a significant challenge. For datasets containing many data points, several models were trained using PPG signals: a deep residual network convolutional neural network (ResNetCNN) ResNetCNN, an Xception architecture, a bidirectional long short-term memory (BILSTM), and a combination of these models. Training and testing datasets were assigned using a fivefold cross validation approach. Based on the testing dataset, the model demonstrated a proper classification accuracy of 91.8%.

Abstract:BACKGROUND: Mental fatigue has become a non-negligible health problem in modern life, as well as one of the important causes of social transportation, production and life accidents. OBJECTIVE: Fatigue detection based on traditional machine learning requires manual and tedious feature extraction and feature selection engineering, which is inefficient, poor in real-time, and the recognition accuracy needs to be improved. In order to recognize daily mental fatigue level more accurately and in real time, this paper proposes a mental fatigue recognition model based on 1D Convolutional Neural Network (1D-CNN), which inputs 1D raw ECG sequences of 5 s duration into the model, and can directly output the predicted fatigue level labels. METHODS: The fatigue dataset was constructed by collecting the ECG signals of 22 subjects at three time periods: 9:00–11:00 a.m., 14:00–16:00 p.m., and 19:00–21:00 p.m., and then inputted into the 19-layer 1D-CNN model constructed in the present study for the classification of mental fatigue in three grades. RESULTS: The results showed that the model was able to recognize the fatigue levels effectively, and its accuracy, precision, recall, and F1 score reached 98.44%, 98.47%, 98.41%, and 98.44%, respectively. CONCLUSION: This study further improves the accuracy and real-time performance of recognizing multi-level mental fatigue based on electrocardiography, and provides theoretical support for real-time fatigue monitoring in daily life.

Abstract:Non-pathological mental fatigue is a recurring, but undesirable condition among people in the fields of office work, industry, and education. This type of mental fatigue can often lead to negative outcomes, such as performance reduction and cognitive impairment in education; loss of focus and burnout syndrome in office work; and accidents leading to injuries or death in the transportation and manufacturing industries. Reliable mental fatigue assessment tools are promising in the improvement of performance, mental health and safety of students and workers, and at the same time, in the reduction of risks, accidents and the associated economic loss (e.g., medical fees and equipment reparations). The analysis of biometric (brain, cardiac, skin conductance) signals has proven to be effective in discerning different stages of mental fatigue; however, many of the reported studies in the literature involve the use of long fatigue-inducing tests and subject-specific models in their methodologies. Recent trends in the modeling of mental fatigue suggest the usage of non subject-specific (general) classifiers and a time reduction of calibration procedures and experimental setups. In this study, the evaluation of a fast and short-calibration mental fatigue assessment tool based on biometric signals and inter-subject modeling, using multiple linear regression, is presented. The proposed tool does not require fatigue-inducing tests, which allows fast setup and implementation. Electroencephalography, photopletismography, electrodermal activity, and skin temperature from 17 subjects were recorded, using an OpenBCI helmet and an Empatica E4 wristband. Correlations to self-reported mental fatigue levels (using the fatigue assessment scale) were calculated to find the best mental fatigue predictors. Three-class mental fatigue models were evaluated, and the best model obtained an accuracy of 88% using three features, β/θ (C3), and the α/θ (O2 and C3) ratios, from one minute of electroencephalography measurements. The results from this pilot study show the feasibility and potential of short-calibration procedures and inter-subject classifiers in mental fatigue modeling, and will contribute to the use of wearable devices for the development of tools oriented to the well-being of workers and students, and also in daily living activities.

Abstract:Fatigue is a multifunctional and complex phenomenon that affects how individuals perform an activity. Fatigue during running causes changes in normal gait parameters and increases the risk of injury. To address this problem, wearable sensors have been proposed as an unobtrusive and portable system to measure changes in human movement as a result of fatigue. Recently, a category of wearable devices that has gained attention is flexible textile strain sensors because of their ability to be woven into garments to measure kinematics. This study uses flexible textile strain sensors to continuously monitor the kinematics during running and uses a machine learning approach to estimate the level of fatigue during running. Five female participants used the sensor-instrumented garment while running to a state of fatigue. In addition to the kinematic data from the flexible textile strain sensors, the perceived level of exertion was monitored for each participant as an indication of their actual fatigue level. A stacked random forest machine learning model was used to estimate the perceived exertion levels from the kinematic data. The machine learning algorithm obtained a root mean squared value of 0.06 and a coefficient of determination of 0.96 in participant-specific scenarios. This study highlights the potential of flexible textile strain sensors to objectively estimate the level of fatigue during running by detecting slight perturbations in lower extremity kinematics. Future iterations of this technology may lead to real-time biofeedback applications that could reduce the risk of running-related overuse injuries.

Abstract:The new method is proposed to monitor the level of current physical load and accumulated fatigue by several objective and subjective characteristics. It was applied to the dataset targeted to estimate the physical load and fatigue by several statistical and machine learning methods. The data from peripheral sensors (accelerometer, GPS, gyroscope, magnetometer) and brain-computing interface (electroencephalography) were collected, integrated, and analyzed by several statistical and machine learning methods (moment analysis, cluster analysis, principal component analysis, etc.). The hypothesis 1 was presented and proved that physical activity can be classified not only by objective parameters, but by subjective parameters also. The hypothesis 2 (experienced physical load and subsequent restoration as fatigue level can be estimated quantitatively and distinctive patterns can be recognized) was presented and some ways to prove it were demonstrated. Several "physical load" and "fatigue" metrics were proposed. The results presented allow to extend application of the machine learning methods for characterization of complex human activity patterns (for example, to estimate their actual physical load and fatigue, and give cautions and advice).
Automatic Detection of Fatigued Gait Patterns in Older Adults: An Intelligent Portable Device Integrating Force and Inertial Measurements with Machine Learning

Abstract:Purpose: This study aimed to assess the feasibility of early detection of fatigued gait patterns for older adults through the development of a smart portable device. Methods: The smart device incorporated seven force sensors and a single inertial measurement unit (IMU) to measure regional plantar forces and foot kinematics. Data were collected from 18 older adults walking briskly on a treadmill for 60 min. The optimal feature set for each recognition model was determined using forward sequential feature selection in a wrapper fashion through fivefold cross-validation. The recognition model was selected from four machine learning models through leave-one-subject-out cross-validation. Results: Five selected characteristics that best represented the state of fatigue included impulse at the medial and lateral arches (increased, p = 0.002 and p < 0.001), contact angle and rotation range of angle in the sagittal plane (increased, p < 0.001), and the variability of the resultant swing angular acceleration (decreased, p < 0.001). The detection accuracy based on the dual signal source of IMU and plantar force was 99%, higher than the 95% accuracy based on the single source. The intelligent portable device demonstrated excellent generalization (ranging from 93 to 100%), real-time performance (2.79 ms), and portability (32 g). Conclusion: The proposed smart device can detect fatigue patterns with high precision and in real time. Significance: The application of this device possesses the potential to reduce the injury risk for older adults related to fatigue during gait.

Abstract:The human body is a complex system, and the energy consumption in sports activities is influenced by many factors, making it challenging to accurately predict the degree of sports fatigue. Therefore, this article aims to use spectral sensors and machine learning algorithms to predict the level of sports fatigue among athletes. Spectral sensors capture biological signals inside the athlete’s body and convert them into digital signals. Multiple optical parameters are selected as input features to reflect the physiological state and metabolic activities inside the athlete’s body. After the data collection is completed, machine learning algorithms are used to analyze and process the data collected by the sensors, learn the patterns and patterns of the data, and make predictions based on these patterns and patterns. The results indicate that spectral sensors and machine learning algorithms can effectively predict the level of sports fatigue among athletes. The high correlation between the predicted results and the actual test results proves the reliability and accuracy of the proposed method. This method can provide timely and accurate fatigue monitoring for coaches and athletes, thereby helping to optimize training plans and avoid the occurrence of sports injuries.

Abstract:Mental fatigue is a psychophysiological state that has an intense adverse effect on the quality of life, undermining both the mental and the physical health. As a consequence, detecting this state accurately can be beneficial to delivering prevention and treatment mechanisms. In parallel, advancements in wearable device technologies have reached a maturity level that can support continuous and long-term monitoring of physiological signals accurately and unobtrusively in everyday life. In this paper, a mental fatigue detection methodology is proposed, founded on the use of a wearable consumer device to enable heart rate variability (HRV) analysis and suitable machine learning models to predict the stress state with high accuracy. Even though a lot of studies have attempted to address the same problem in the past by using multiple signals, these approaches are invasive because they require a lot of sensor devices to be attached to the users. The main contributions of this work are three folds: An experimental study with 32 healthy participants demonstrating that mental fatigue caused by cognitive overload can be detected using a wearable commodity device and a single biomarker; Detection models based on eight HRV features which were found to have significant differences after inducing mental fatigue; A methodology, which includes a support vector machine, among other classifiers, and principal component analysis capable to predict cognitive performance degradation in the form of mental fatigue with a high accuracy which can be further improved by applying an ensemble model. The ability to detect mental fatigue unobtrusively and on a regular basis, for example, in workplace environments, could provide awareness on the causes of performance variations which subsequently can navigate improvements on working practices and task planning to prevent accidents or productivity losses.

Abstract:Wearable sensors have increasingly been applied in healthcare to generate data and monitor patients unobtrusively. Their application for Brain–Computer Interfaces (BCI) allows for unobtrusively monitoring one's cognitive state over time. A particular state relevant in multiple domains is cognitive fatigue, which may impact performance and attention, among other capabilities. The monitoring of this state will be applied in real learning settings to detect and advise on effective break periods. In this study, two functional near-infrared spectroscopy (fNIRS) wearable devices were employed to build a BCI to automatically detect the state of cognitive fatigue using machine learning algorithms. An experimental procedure was developed to effectively induce cognitive fatigue that included a close-to-real digital lesson and two standard cognitive tasks: Corsi-Block task and a concentration task. Machine learning models were user-tuned to account for the individual dynamics of each participant, reaching classification accuracy scores of around 70.91±13.67%. We concluded that, although effective for some subjects, the methodology needs to be individually validated before being applied. Moreover, time on task was not a particularly determining factor for classification, i.e., to induce cognitive fatigue. Further research will include other physiological signals and human–computer interaction variables.
