Abstract:Traffic accidents have a substantial impact on human life and property, resulting in millions of injuries every year. To ensure road safety and enhance the research in this direction, it is necessary to develop methods that can efficiently predict and classify the accident severity. However, traffic accident datasets may contain a large number of features, making it challenging to extract relevant information and patterns from high-dimensional data. Moreover, traffic accidents may be influenced by multiple factors and temporal dependencies, leading to a dynamic impact of each factor on accident severity over time. To address these challenges, we propose a novel deep-learning approach for predicting traffic accident severity. Specifically, we first conduct a thorough data preprocessing step to clean the data and ensure its quality. Then, a Convolutional Neural Network (CNN) is introduced to extract spatial features and patterns from the high-dimensional data, followed by a Bidirectional Long Short-Term Memory network (BiLSTM) to capture the temporal dependencies between various factors that affect traffic accidents. We also implement attention mechanisms to weigh the importance of each feature in the prediction, thereby reducing the impact of noisy or irrelevant data. To evaluate the effectiveness of our approach, we conduct experiments on a real-world traffic accident dataset from two cities. The results demonstrate the practicality and effectiveness of our framework for traffic accident severity prediction, with potential to enhance road safety.

Abstract:Accurately predicting traffic accident severity is crucial for road safety. However, existing studies lack interpretability in revealing the relationship between accident severity and key factors. To address this issue, we propose a new interpretable analytical framework. The framework utilizes XGBoost and SHAP to select effective factors. Then the AISTGCN model is constructed by improving the STGCN through the local attention mechanism to predict the severity of the accident. Finally, DeepLIFT is used to interpret the forecasts and identify key factors. Our experiments using real-world UK accident data demonstrate that our proposed AISTGCN outperforms baseline models in outcome prediction with an accuracy of 0.8772. The computation time was reduced and the reliability of predictions was enhanced through screening for effective factors. Furthermore, DeepLIFT provides more reasonable explanations when explaining accidents of different severity, indicating that vehicle count significantly impacts. Our framework aids in developing effective safety measures to reduce accidents.

Abstract:With the rapid development of urbanization, the boom of vehicle numbers has resulted in serious traffic accidents, which led to casualties and huge economic losses. The ability to predict the risk of traffic accident is important in the prevention of the occurrence of accidents and to reduce the damages caused by accidents in a proactive way. However, traffic accident risk prediction with high spatiotemporal resolution is difficult, mainly due to the complex traffic environment, human behavior, and lack of real-time traffic-related data. In this study, we collected heterogeneous traffic-related data, including traffic accident, traffic flow, weather condition and air pollution from the same city; proposed a deep learning model based on recurrent neural network toward a prediction of traffic accident risk. The predictive accident risk can be potential applied to the traffic accident warning system. We ranked the predictive power of various factors considered in our model through the method of Granger causality analysis, and established the order of predictive power as traffic flow > traffic accident > geographical position >> weather + air quality + holiday + time period, which indicate that traffic flow is the most essential factor for the occurrence of traffic accidents. The proposed method can be integrated into an intelligent traffic control system toward a more reasonable traffic prediction and command organization.

Abstract:Real-time assessment and short-term warning of driving risks are critical for AI-assisted vehicles to significantly improve the safety and reliability of mobility. However, existing methods do not comprehensively consider these factors, making it difficult to achieve more accurate risk assessments. Aiming at this problem, this paper proposes a new driving risk assessment framework by integrating multimodal data. First, based on naturalistic driving experiments, we collected multimodal data encompassing human-vehicle-road factors. Then, using the Latent Dirichlet Allocation (LDA) model, we identified three risk levels based on driving behavior features: normal driving, longitudinal risky driving, and lateral risky driving. To better understand the spatiotemporal importance of multiple factors, a spatiotemporal dual-channel neural network based on a multi-layer attention mechanism (MLA-DCNN) is developed. This model has a spatiotemporal dual-channel structure, which can integrate "low-level" historical sequences and "high-level" extract statistical features of multiple features. In addition, it adopts three layers of attention mechanism, respectively used to capture the differences of features in temporal, spatial, and extracted-level dimensions. Results reveal that the LDA model is more effective than traditional clustering methods in uncovering latent patterns of driving risk. The proposed model achieved an impressive accuracy of 91.04%, demonstrating higher risk assessment capabilities than the other alternative models. In addition, the multilayer attention enhances the interpretability of the model and is able to capture the spatiotemporal importance of different factors across various road environments. This method can be applied to connected and automated vehicles (CAVs) using multimodal natural driving data collected by in-vehicle sensors. It enhances the risk warning capabilities of driving assistance systems, and the multidimensional importance analysis also supports decision-making for traffic management authorities.
Road Traffic Accident Risk Prediction and Key Factor Identification Framework Based on Explainable Deep Learning

Abstract:The prediction and identification of key factors in road traffic accidents are crucial for accident prevention, yet previous studies have often examined these aspects separately. To comprehensively assess the risk level of road traffic accidents and their key determinants, this paper proposes a comprehensive forecasting and analysis framework that offers a novel perspective for identifying key risk factors from a modeling standpoint compared to existing methods. The CNN-BiLSTM-Attention model was developed for predicting the risk value of road accidents, and DeepSHAP was employed to interpret the model and extract the key factors contributing to traffic accidents. This deep learning framework combines convolutional neural networks (CNN) and Bi-directional long short-term memory (BiLSTM), while incorporating a spatial-temporal local attention mechanism to enhance its capability in capturing spatiotemporal features. Through analysis and experimentation on real-world datasets, our model demonstrates superior accuracy in predicting traffic accident risk compared to the benchmark model, achieving a Mean Absolute Error (MAE) of 0.2475 on the UK dataset and 0.2683 on the US dataset. The results obtained from DeepSHAP were found to be more rational and informative in identifying key factors of different severity levels using four methods. To verify the rationality and stability of obtaining these key factors, the first 15 factors were reintegrated into the prediction model, resulting in almost unchanged accuracy and reduced model iteration time. By improving the influential factors, road traffic accidents can be effectively mitigated.

Abstract:Traffic is a dynamic coupled system consisting of four factors: humans, vehicles, roads, and the environment. Safe and controllable external stimuli and the psychological condition of drivers guarantee the safety of vehicle driving, but due to the lack of quantitative means of assessing driver and environmental factors, accident analysis and prediction methods often lack scientificity. This reduces the effectiveness of traffic accident prediction and control. In this study, a full-factor urban traffic accident prediction framework is constructed using real-vehicle test data and open-source data to achieve the accurate prediction of urban traffic accidents. The real-vehicle test data include 1022 sets of experimental data obtained by 23 experimenters for more than 7 consecutive laps on 6 routes with large variability. The wide application of deep learning in computer vision and the popularity of physiological acquisition technology in daily life provide quantitative means for assessing driver and environmental factor variables, and the open-source data include traffic volume data from the drip platform, street view data and road design information. In addition, the analysis methods involving the elasticity coefficient and marginal benefit coefficient are used to analyze the potential connection between correlated variables and traffic safety. Based on this, all-factor traffic safety improvement measures are proposed, providing theoretical support and methodological support for the improvement of traffic safety on urban roads.

Accident Injury Severity Prediction Research Based on Stacking Model

Abstract:To mitigate the accident injury severity of intelligent vehicles when faced with the inevitable collision accident scenario caused by the intrusion of other traffic participants, it is critical to build an applicable accident injury severity prediction model. A two-layer Stacking framework is proposed in this study to predict the accident injury severity: The first layer integrates the advantages of four base classifiers: KNN (K Nearest Neighbors), RF (Random Forests), AdaBoost (Adaptive Boosting), and XGBoost (Extreme Gradient Boosting); The second layer Logistic Regression model is trained based on the outputs of the first layer and completes the final classification of accident injury severity. A total of 23995 samples released by the National Automotive Sampling System Crashworthiness Data System (NASS-CDS) were used in this study. The inputs of the model are accident-related features, which are obtained by vehicle sensors (Lidar, Radar, and Camera). The output is the highest injury level of the passengers in the vehicle, which includes 0 (non-injury), 1 (Minor injury), 2 (Serious injury), and 3 (Death). Experimental results show that the classification precision of this method reaches 84.08%, and it is superior to other commonly used models in precision, recall, and F1Score, which can be applied to the research of road traffic safety.

Abstract:Traffic accidents are usually unique events with unpredictable geographical and temporal dimensions; thus, accident injury severity level (INJ-SL) analysis presents formidable categorization and data stability problems. Classical statistical models are limited in their ability to correctly model INJ-SL, whilst sophisticated machine learning approaches do not appear to have any equations to prioritize/analyze multiple contributing factors to forecast accidents accompanying INJ-SLs. In addition, the intercorrelations between the input variables may render the conclusions of a formal sensitivity analysis incorrectly. Rear-end collisions are the most common form of traffic accidents; consequently, their linked INJ-SL requires more research. This paper provides a complex technique based on a deep learning paradigm paired with different indicators of Global Sensitivity Analysis to address all of these concerns. Unlike existing neural network designs, this technique presents a deep residual neural network structure that employs residual shortcuts (i.e., connections). The connections enable the DRNNs to sidestep a few levels of the deep network architecture , evading the regular training with high accuracy issues. Using the trained DRNNs model, a Latin Hypercube sampling simulation was undertaken to determine each explanatory component's influence on the resulting INJ-SL. The latest available data from 2011 to 2018 is used to assess all rear-end collisions in North Carolina. A comparison was made between the performance of two different schemes of data categorization using a set of global sensitivity metrics. It was determined that the devised technique overcame the data heterogeneity problems to achieve an accuracy of 87%. In addition, the proposed sensitivity analysis identified the most relevant factors associated with INJ-SL rear-end collisions.

Abstract:Traffic accidents are inevitable events that occur unexpectedly and unintentionally. Therefore, analyzing traffic data is essential to prevent fatal accidents. Traffic data analysis provided insights into significant factors and driver behavioral patterns causing accidents. Combining these patterns and the prediction model into an accident prevention system can assist in reducing and preventing traffic accidents. This study applied various machine learning models, including neural network, ordinal regression, decision tree, support vector machines, and logistic regression to have a robust prediction model in injury severity. The trained model provides timely and accurate predictions on accident occurrence and injury severity using real-world traffic accident datasets. We proposed an informative negative data generator using feature weights derived from multinomial logit regression to balance the non-fatal accident data. Our aim is to resolve the bias that happens in the favor of the majority class as well as performance improvement. We evaluated the overall and class-level performance of the machine learning models based on accuracy and mean squared error scores. Three hidden layered neural networks outperformed the other models with 0.254 ± 0.038 and 0.173 ± 0.016 MSE scores for two different datasets. A neural network, which provides more accurate and reliable results, should be integrated into the accident prevention system.

Enhancing Prediction and Analysis of UK Road Traffic Accident Severity Using AI: Integration of Machine Learning, Econometric Techniques, and Time Series Forecasting in Public Health Research

Abstract:This research investigates road traffic accident severity in the UK, using a combination of machine learning, econometric, and statistical methods on historical data. We employed various techniques, including correlation analysis, regression models, GMM for error term issues, and time-series forecasting with VAR and ARIMA models. Our approach outperforms naive forecasting with an MASE of 0.800 and ME of -73.80. We also built a random forest classifier with 73% precision, 78% recall, and a 73% F1-score. Optimizing with H2O AutoML led to an XGBoost model with an RMSE of 0.176 and MAE of 0.087. Factor Analysis identified key variables, and we used SHAP for Explainable AI, highlighting influential factors like Driver_Home_Area_Type and Road_Type. Our study enhances understanding of accident severity and offers insights for evidence-based road safety policies.

Abstract:Traffic accidents have become severe risks as they are one of the causes of enormous deaths worldwide. Reducing the number of incidents is critical to saving lives and achieving sustainable cities and communities. Machine learning and data analysis techniques interpret the reasons for car accidents and propose solutions to minimize them. However, this needs to take the benefits of big data solutions as the size and velocity of traffic accident data are increasingly large and rapid. This paper explores road car accident data patterns and proposes a predictive model by investigating meaningful data features, such as accident severity, the number of casualties, and the number of vehicles. Therefore, a pre-processing model is designed to convert raw data using missing and meaningless feature removal, data attribute generalization, and outlier removal using interquartile. Four classification methods, including decision trees, random forest, multinomial logistic regression, and naïve Bayes, are used and evaluated to study the performance of road accident prediction. The results address acceptable levels of accuracy for car accident prediction except for naïve Bayes. The findings are discussed through a data-driven approach to understand the factors influencing road car accidents and highlight the key ones to propose accident prevention solutions. Finally, some strategies are provided to achieve healthy and community-friendly cities.

Abstract:Assessment of roadway safety in real-time is a necessary component for providing proactive safety countermeasures to ensure the continued safety and efficiency of roadways. A framework for utilizing data from connected vehicles and other probe sources is proposed in this study. Connected vehicles present an opportunity to provide live fingerprinting and activity monitoring on roadways. Taking advantage of high-resolution trajectory data streaming directly from connected vehicles, variables are extracted and the relationship with crashes are explored utilizing statistical and machine learning models. Hard acceleration events, in conjunction with segment miles are shown to have strong positive correlations with historical crash outcomes as proven by OLS, Poisson and Gradient Booster regression models. An XGBoost classification model is then trained to predict the real-time instances of crash outcomes at 5 min temporal bins with high levels of accuracy when trained with data including the real-time segment speed, reference speed, segment miles, a segment crash risk factor and other variables related to the difference in speeds between consecutive segments as well as the hour of the day. A weighted ensemble model achieved the best performance with an accuracy of 0.95. The results present evidence that the framework can capitalize on the richness of data available via connected vehicles and is implementable as a component in Advanced Traffic Management Systems for the analysis of safety critical situations in real-time.

Abstract:Smart cities came out as highly knowledgeable bio-networks, offering intelligent services and innovative solutions to urban problems. With rapid development, urbanization, and population pressure, traffic congestion and collisions are increasing substantially in road highway zones. Recently, traffic collisions have become one of the hugest national health problems in many cities of the world. Hence, crash injury severity prediction is vital for informing responsible authorities and the public to find alternative ways of dealing with its adverse effects, accordingly improving traffic safety and reducing traffic congestion. In predicting crash injury severity, researchers have explored and applied several techniques to aid in traffic injury management. However, the performance of many techniques suffers from some inherent limitations, including overgeneralization, lack of interpretability for humans, and low-performance accuracy. To address these issues, this paper proposes a novel computational framework based on improved wide and deep learning methods to predict accurately crash injury severity in the context of smart cities. On the crash dataset of New Zealand cities from 2000 to 2020, the proposed model has demonstrated better performance in comparison with the benchmark algorithms. Moreover, SHAP (SHapley Additive exPlanation) is employed to interpret the results and analyze the importance of each determinant of crash severity. The proposed method can help to prevent traffic crashes in smart cities and take proactive measures before the occurrence, also trauma centers can refer to this information to dispatch proper emergency service equipment swiftly and assist injuries to get direct medical care regardless of the crash location.

Abstract:The causes analysis of road traffic accidents is often modelled based on high-dimensional small-sample data; however, such models often have low predictive accuracy and poor generalization performance . An analytical framework that considers both data augmentation and model optimization can enhance variable interpretation and predictive model performance, thereby improving the shortcomings of existing accident analysis methods. Our approach is as follows: 1) Starting with an analysis of the nature of road accidents, a symbolic operation is used to design a feature crosses algorithm. A random variable is added to construct a quantifiable feature selection algorithm, which can form a data augmentation method that conforms to the accident rules. 2) A highly reliable framework for analysing accident causes is constructed by using forward selection to optimize an ensemble learning model subset combined with feature crosses, feature selection and multiple-classification algorithms. A case study with accident data from a city in China shows that ensemble learning has the advantages of high predictive accuracy and strong generalization performance. It can accurately identify the key causes of accidents based on highly dimensional small-sample data. Driving behaviours such as lane changes and turns are the key causes of accidents. Giving drivers effective traffic environment information in a timely manner can significantly improve driving performance and reduce accident risk. This research provides a reference for the analysis of road accidents.

Abstract:Accurate real-time prediction of occupant injury severity in unavoidable collision scenarios is a prerequisite for enhancing road traffic safety with the development of highly automated vehicles. Specifically, a safety prediction model provides a decision reference for the trajectory planning system in the pre-crash phase and the adaptive restraint system in the in-crash phase. The main goal of the current study is to construct a data-driven, vehicle kinematic feature-based model to realize accurate and near real-time prediction of in-vehicle occupant injury severity. A large-scale numerical database was established focusing on occupant kinetics. A first-step deep-learning model was established to predict occupant kinetics and injury severity using a convolutional neural network (CNN). To reduce the computational time for real-time application, the second step was to extract simplified kinematic features from vehicle crash pulses via a feature extraction method, which was inspired by a visualization approach applied to the CNN-based model. The features were incorporated with a low-complexity machine-learning algorithm and achieved satisfactory accuracy (85.4 % on the numerical database, 78.7 % on a 192-case real-world dataset) and decreased computational time (1.2 ± 0.4 ms) on the prediction tasks. This study demonstrated the feasibility of using data-driven and feature-based approaches to achieve accurate injury risk estimation prior to collision. The proposed model is expected to provide a decision reference for integrated safety systems in the next generation of automated vehicles.

Abstract:With the development of big data technology and the improvement of deep learning technology, data-driven and machine learning application have been widely employed. By adopting the data-driven machine learning method, with the help of clustering processing of data sets, a recurrent neural network (RNN) model based on Keras framework is proposed to predict the injury severity in urban areas. First, with crash data from 2014 to 2017 in Nevada, OPTICS clustering algorithm is employed to extract the crash injury in Las Vegas. Next, by virtue of Keras' high efficiency and strong scalability, the parameters of loss function, activation function and optimizer of the deep learning model are determined to realize the training of the model and the visualization of the training results, and the RNN model is constructed. Finally, on the basis of training and testing data, the model can predict the injury severity with high accuracy and high training speed. The results provide an alternative and some potential insights on the injury severity prediction.

Thus, to progress in this area, in this study, a thorough artificial neural network combined with an improved metaheuristic algorithm was developed and tested in terms of its structure, training function, factor analysis, and comparative results. Data from I5, an interstate highway in the Washington State during the period of 2011–2015, were used for fitting and prediction, and after setting the theoretical three-layer neural network (NN), an improved Particle Swarm Optimization (PSO) method with adaptive inertial weight was offered to optimize the NN, and finally, a comparison among different adaptive strategies was conducted. The results showed that although the algorithms produced almost the same accuracy in their predictions, a backpropagation method combined with a nonlinear inertial weight setting in PSO produced fast global and accurate local optimal searching, thereby demonstrating a better understanding of the entire model explanation, which could best fit the model, and at last, the factor analysis showed that non-road-related factors, particularly vehicle-related factors, are more important than road-related variables. The method developed in this study can be applied to a big data analysis of traffic accidents and be used as a fast-useful tool for policy makers and traffic safety researchers.

Capturing and Exploring Unobserved Heterogeneity in Traffic Crash Injuries in China: A Deep Learning Approach

Abstract:Traffic crash injuries have often been considered a leading threat to human lives. To alleviate this problem, crash data are used to explore various factors of injuries which resulted in accidents with both statistical models and deep learning models. Unobserved heterogeneity, as a result of the complexity of crashes, is inevitable in injury severity analysis. However, it is overlooked in most deep learning models. In this study, TabVAE, a deep learning model which accounts for unobserved heterogeneity, is proposed to analyze the severity of injuries. Data from a total of 3,445 crashes in China, involving 5,384 passengers, are collected and analyzed. The experimental results suggest that the proposed TabVAE model can better capture unobserved heterogeneity. Model comparison demonstrates that TabVAE outperforms classical statistical methods and deep learning models. Additionally, the proportion of unobserved heterogeneity within data and the importance of explanatory variables are identified. The results show that energy dissipation is the key factor to the injury of passengers, and that vehicle damage serves as the most important indicator of energy dissipation. Furthermore, Advanced Driver Assistant System contributes significantly to the unobserved heterogeneity of crashes since it alters the way of energy dissipation. Therefore, addressing unobserved heterogeneity caused by ADAS systems is essential for future accident analysis works.

Abstract:Autonomous vehicles (AVs) represent an exciting frontier in transportation, promising increased safety and efficiency on the roads. However, like any technological advancement, they are not immune to accidents. Understanding the severity of accidents involving AVs is crucial for enhancing their reliability and ensuring public trust in this transformative technology. To address this challenge, our study has employed cutting-edge natural language processing techniques combined with machine learning to predict the severity of accidents involving AVs. Our study has contributed significantly by creating a novel dataset derived from post-disengagement accident reports, covering the years 2019-2022. This dataset comprises detailed descriptions of accidents, sensor information, and other critical parameters. Moreover, we have introduced a novel approach called Multi-Distance Synthetic Technique (MDST) to balance the imbalanced nature of our dataset, which included only 334 samples due to the rarity of such accident data. Utilizing MDST for data balancing, we aimed to enhance the robustness of our analysis. Additionally, we employed Recursive Feature Selection (RFS) to extract a valuable feature set that was crucial in predicting accident severity. Leveraging this selected feature set, we trained an ensemble model, which remarkably outperformed expectations, achieving an impressive accuracy score of 0.92.
