Abstract:Conventional direction-of-arrival (DOA) estimation algorithms are sensitive to array imperfections and outliers, making it challenging to realize accurate estimates in real applications. Facing the challenge, we propose a robust variational Bayesian inference based DOA estimation algorithm using the linear sparse array in this paper, where accurate DOA estimation with increased number of degrees of freedom (DOFs) is realized. With the mixture of von Mises model, a prior-grid scheme is further proposed to alleviate the computational burden introduced by the Bayesian variational inference framework. Since there is no restriction on the prior knowledge of the number of sources, the proposed algorithm is friendly to actual scenarios. Simulation results demonstrate the effectiveness of the proposed algorithm.

Abstract:The wide proliferation of drones has posed great threats to personal privacy and public security, which makes it urgent to monitor and locate intruding drones in sensitive areas. In Direction of Arrival (DOA) based localization, the estimation accuracy of DOA directly affects the localization accuracy. In this paper, we propose a novel algorithm to estimate the DOA of an intruding drone by exploiting its acoustic feature, which is mainly reflected in the strength distribution of the harmonics of the received acoustic signal. Specifically, this algorithm first estimates the harmonic frequencies of the drone's acoustic signal in frequency domain. Then, multiple signal classification is used to estimate the DOAs of all the selected harmonics. Furthermore, weighted sum of these DOA estimates will be taken as the drone's DOA estimate, where the weights are in proportional to the energy of the corresponding harmonics. The performance of the proposed algorithm is verified by both simulation and field experiments.

Abstract:A two microphone direction of arrival (DOA) estimation technique for multiple speech sources is developed which exploits speech specific properties, namely sparsity in time-frequency (spectrum) domain. For robustness, we exploit the sparsity in the frequency domain by focusing on the spectral content concentrated in sinusoidal tracks obtained through sinusoidal modeling. When multiple speeches are mixed in the two microphone system, the inter-channel phase differences (IPD) between the dual channels on those sinusoidal tracks will be dominated by the spatial information of the most powerful source at that specific time-frequency point because of the spectrum sparsity and masking effects. Thereby, the source localization problem is turned into a clustering problem on the IPD versus frequency plot, and the generalized mixture decomposition algorithm (GMDA) is used to cluster the groups of points corresponding to multiple sources. The DOA of each source is derived from the parameters of each cluster. Experimental results conducted show the scheme to be very effective.

Abstract:In this article, a novel vehicle positioning system architecture based on direction-of-arrival (DOA) estimation of incoherently distributed (ID) sources is proposed employing massive multiple-input–multiple-output (MIMO) arrays. Such an architecture with the associated signal model is more consistent with the actual array application and multipath transmission scenarios. First, an end-to-end two-dimensional (2-D) DOA estimation of ID sources utilizing a dual one-dimensional (1-D) convolutional neural network (D1D-CNN) under the deep learning (DL) framework is performed, where the normalized covariance matrix data is used for both offline training and online estimation. Then, the received SNR information is exploited to select a set of DOA estimates provided by multiple collaborative BSs for positioning. Moreover, transfer learning and an attention mechanism are employed to promote its generalization ability and achieve robustness against array perturbations. Simulation results are provided to show that the proposed method outperforms the state-of-the-art methods in terms of computational complexity, positioning accuracy, and robustness against array perturbations.

Deep Learning Based Stage-wise Two-dimensional Speaker Localization with Large Ad-hoc Microphone Arrays

Abstract:While deep-learning-based speaker localization has shown advantages in challenging acoustic environments, it often yields only direction-of-arrival (DOA) cues rather than precise two-dimensional (2D) coordinates. To address this, we propose a novel deep-learning-based 2D speaker localization method leveraging ad-hoc microphone arrays, where an ad-hoc microphone array is composed of randomly distributed microphone nodes, each of which is equipped with a traditional array. Specifically, we first employ convolutional neural networks at each node to estimate speaker directions. Then, we integrate these DOA estimates using triangulation and clustering techniques to get 2D speaker locations. To further boost the estimation accuracy, we introduce a node selection algorithm that strategically filters the most reliable nodes. Extensive experiments on both simulated and real-world data demonstrate that our approach significantly outperforms conventional methods. The proposed node selection further refines performance. The real-world dataset in the experiment, named Libri-adhoc-node10 which is a newly recorded data described for the first time in this paper, is online available at <a class="link-external link-https" href="https://github.com/Liu-sp/Libri-adhoc-nodes10" rel="external noopener nofollow">this https URL</a>.

Accurate Real-Time Estimation of 2-Dimensional Direction of Arrival using a 3-Microphone Array

Abstract:This paper presents a method for real-time estimation of 2-dimensional direction of arrival (2D-DOA) of one or more sound sources using a nonlinear array of three microphones. 2D-DOA is estimated employing frame-level time difference of arrival (TDOA) measurements. Unlike conventional methods, which infer location parameters from TDOAs using a theoretical model, we propose a more practical approach based on supervised learning. The proposed model employs nearest neighbor search (NNS) applied to a spherical Fibonacci lattice consisting of TDOA to 2D-DOA mappings learned directly in the field. Filtering and clustering post-processors are also introduced for improved source detection and localization robustness.

Abstract:The direction-of-arrival (DOA) estimation is a significant problem in array signal processing and their application in different fields ranging from radars to wireless communications. This problem poses significant challenges when the separation of closely spaced sources becomes difficult. The state-of-art methods fail in providing sufficient resolution to separate the DOA's of closely spaced sources unless large number of large number of antennas is being used. In this paper, the problem of resolving direction-of-arrivals (DOAs) of two closely spaced sources using deep learning technology is considered. We propose a novel network named as DAE-CNN-MUSIC network. The problem is framed as a multi-label classification task. The proposed network is trained to make predictions of DOAs across a wide range of signal-to-noise ratios (SNRs), demonstrates enhanced durability in the presence of noise, and resilience even with smaller number of snapshots. The efficiency and superiority of the proposed network is tested under various scenarios. The experimental results demonstrate vast improvement in performance gains at low-SNR regime, and ability to resolve angles with more precision for SNR ≥ 15 dB when compared to state-of-the-art methods.

Abstract:With the development of deep learning techniques, the field of direction of arrival (DOA) estimation has also made significant progress. However, the accuracy of DOA estimation using end-to-end neural networks (NNs) heavily relies on the classification step of the networks, which necessitates the use of large and representative datasets. Additionally, conventional speech presence probability (SPP) estimation methods based on the ideal ratio mask (IRM) may misclassify time-frequency (T-F) bins dominated by non-speech and noise, which hinders the accurate extraction of directional information. To improve the robustness of existing DOA estimation algorithms, this paper proposes a DOA estimation method with T-F bin selection. In terms of output, instead of using IRM-based SPP, our proposed approach focuses on the a posteriori SPP, a deliberate choice aimed at circumventing potential confusion. For input optimization, we construct features that encompass spatial, temporal, and directional information concurrently, and these are coupled with a frequency bin-wise recurrent neural network (RNN) model to attain precise multi-channel SPP estimation. Subsequently, these SPP estimates are utilized to extract local information for DOA estimation. Moreover, the cascaded structure ensures that the model has the ability to complete out-of-label tasks, effectively reducing the dataset requirements by training only a subset of direction information to achieve omnidirectional DOA estimation. Besides, this contributes to the algorithm's ability to eliminate its reliance on the step size, setting it apart from other end-to-end methods. Simulation results validate that the proposed method achieves higher accuracy and lower error compared to both NN-based end-to-end approaches and traditional full-band approaches under various conditions of reverberation and signal-to-noise ratio.

Abstract:In this paper, a novel direction‐of‐arrival (DOA) estimation method is proposed for linear arrays on the basis of residual neural network (ResNet). The real parts, imaginary parts, and phase entries of the spatial covariance matrix from the on‐grid angles are used as the input of ResNet for training, and the angular directions formulated as a multilabel classification task are predicted using the sample covariance matrix from the off‐grid angles during the testing phase. ResNet demonstrates robustness in the scenarios on a fixed number of signals and a mixed number of signals. Simulation results show that ResNet can achieve significant performance in DOA estimation compared to multiple signal classification, estimation of signal parameters via rotation invariance techniques, convolutional neural network (CNN), and deep complex‐valued CNN in low signal‐to‐noise ratio.

Abstract:This paper presents a method for direction of arrival (DOA) estimation of multiple speech sources based on the temporal correlation and local-frequency stationarity of speech signals. The distribution analysis of single-source points (SSPs) in a recorded signal shows that in the time–frequency (T-F) domain, the SSPs are distributed in the form of a small cluster. According to this distribution, a method for DOA estimation of multiple sound sources is developed based on the continuity between adjacent T-F points. In addition, low-reverberation single-source (LRSS) points are detected based on the phase consistency and used as guidance to detect whether adjacent T-F points are SSPs. The direction deviations between adjacent frequency points and between adjacent frames are used as the SSP detection criteria considering the temporal correlation and local-frequency stationarity. The kernel density estimation and peak search are performed to obtain the dynamic DOA estimation range of each source. Finally, DOA estimates of each source are obtained by statistical weighting-based fine localization. Experiments under both simulated and real conditions show that the proposed method can achieve better localization performance than several existing methods.

Abstract:To improve the accuracy of direction-of-arrival (DOA) estimation, a deep learning (DL)-based method called CDAE-DNN is proposed for hybrid analog and digital (HAD) massive MIMO receive array with overlapped subarray (OSA) architecture in this paper. In the proposed method, the sample covariance matrix (SCM) is first input to a convolution denoise autoencoder (CDAE) to remove the approximation error, then the output of CDAE is imported to a fully-connected (FC) network to get the estimation result. Based on the simulation results, the proposed CDAE-DNN has great performance advantages over traditional MUSIC algorithm and CNN-based method, especially in the situations with low signal to noise ratio (SNR) and low snapshot numbers. And the OSA architecture has also been shown to significantly improve the estimation accuracy compared to non-overlapped subarray (NOSA) architecture. In addition, the Cramer-Rao lower bound (CRLB) for the HAD-OSA architecture is presented.

Robust Three-Microphone Speech Source Localization Using Randomized Singular Value Decomposition

Abstract:Direction-of-arrival (DOA) estimation is a fundamental technique in array signal processing due to its wide applications in beamforming, speech enhancement and many other assistive speech processing technologies. In this paper, we devise a novel DOA technique based on randomized singular value decomposition (RSVD) to improve the performance of non-uniform non-linear microphone arrays (NUNLA). The accurate and efficient singular value decomposition of large data matrices is computationally challenging, and randomization provides an effective tool for performing matrix approximation, therefore, the developed DOA estimation utilizes a modified dictionary-based RSVD method for localizing single speech sources under low signal-to-noise ratios (SNR). Unlike previous methods developed for uniform linear microphone arrays, the proposed approach with L-shaped three microphone setup has no 'left-right' ambiguity. We present the performance of our proposed method in comparison to other techniques. The demonstrated experiments shows at-least 20% performance improvement using simulated data and 25% performance improvement using real data when compared with similar DoA estimation techniques for NUNLA. The proposed method exploits frame-based online time delay of arrival (TDOA) measurements which facilitates the proposed algorithm to run on real-time devices. We also show an efficient real-time implementation of the proposed method on a Pixel 3 Android smartphone using its built-in three microphones for hearing aid applications.

Abstract:In this paper, we study the problem of wideband direction of arrival (DoA) estimation with sparse linear arrays (SLAs), where a number of uncorrelated wideband signals impinge on an SLA and the data is collected from multiple frequency bins. To boost the performance and perform underdetermined DoA estimation, the difference co-array response matrices for all frequency bins are constructed first. Then, to merge the data from different frequency bins, we resort to the Jacobi-Anger approximation to transform the co-array response matrices of all frequency bins into a single virtual uniform linear array (ULA) response matrix. The major advantage of this approach is that the transformation matrices are all signal independent. For the special case where all sources share an identical distribution of the power spectrum, we develop two super-resolution off-the-grid DoA estimation approaches based on atomic norm minimization (ANM), one with and one without prior knowledge of the power spectrum. Our solution is able to resolve more sources than the number of antennas but also more than the number of degrees of freedom (DoF) of the difference co-array of the SLA. For the general case where each source has an arbitrary power spectrum, we propose a multi-task ANM method to exploit the joint sparsity from all frequency bins. Simulation results show that our proposed methods present a clear performance advantage over existing methods, and achieve an estimation accuracy close to the associated Cramr-Rao bounds (CRBs).

Abstract:Multiple direction-of-arrival estimation is one of the core functions in array signal processing and has many engineering applications. It is proposed that it can be realized using a two-stage strategy which consists of multiclass classification for region segmentation and successive cancellation-based fine estimation in subregions. In the first stage, the deep convolutional network (DCN) is introduced to classify the 2D angles into discrete subregions of the arrival plane. To enhance the DCN performance, the K-means clustering algorithm is applied to label 2D angles. The DCN is trained using the dataset with only one signal which can considerably reduce training complexity and dataset size. The trained DCN can be generalized for multisignal scenarios. In the second stage, the orthogonal matching pursuit algorithm is utilized to estimate the 2D angles in each subregion. To estimate multiple signals, orthogonal projection transformation is employed to successively cancel the estimated signals. Numerical results demonstrate that the proposed DCN-assisted multiple direction-of-arrival estimation method has lower complexity with better performance than the reduced-dimension MUSIC algorithm.

Abstract:Multi-source sound localization can find applications in many domains including auditory scene analysis, fault detection and diagnosis in manufacturing, augmented reality, etc. In far fields, 3D sound source localization is equivalent to finding the direction of arrival (DOA), namely, the azimuth and elevation angles of sound sources. Recent DOA estimation pipelines take multichannel audio inputs, extract spectral features from each channel and then feed them into a deep neural network. Unfortunately, the spectral features contain only the time-frequency information of the audio signals, while spatial information is only implicitly captured in the signals across different channels, which is highly dependent on the acoustic array geometry. To embed the spatial information of the sound source into the spectral feature representation, we propose a DSB-based spatial mapping method encode sound source location information. It can be combined with different feature extraction methods and machine learning models for DOA estimation. Furthermore, a redundancy removal procedure is proposed to accelerate DSB computation so that the pipeline can run in real-time on embedded GPUs, such as NVidia Jeston Nano. We conduct extensive experiments using two neural network models along with the DSB method on two datasets. The experiments demonstrate that the DOA errors can be effectively reduced using the DSB method. When combining DSB for feature extraction, the DOA errors are reduced by up to 19.24%. In addition, the feature extraction process is accelerated by up to 30.42% after the application of redundancy removal.

Abstract:A two-dimensional wideband Direction-of-Arrival (DOA) estimation algorithm with acoustic vector-sensor array is proposed, which is based on the idea of wideband focusing to solve the coherent sources problem, and the estimated DOA parameters are automatically paired. By Monte Carlo simulations, it shows that the proposed algorithm: (1) can determine the number of the sources reliably; (2) does not suffer from the performance degradation due to the same DOA parameters in the incident sources; and (3) is robust when there are array gain and phase errors.

Abstract:Acoustic source localization is one of the most important applied fields of microphone arrays. Microphone array source localization is to estimate location parameters of the acoustic source following from some microphone array configuration. An acoustic direction of arrival (DOA) estimation algorithm based on parameterized spatial circular prediction is deduced in this paper. Associated with eigen-decomposition of array signals, the spatial covariance matrix is modified to compute broadband spatial spectrum aimed at estimating the acoustic DOA. The spatial circular prediction spectrum is compared in this paper with several broadband spectra, such as multichannel cross correlation coefficient (MCCC) and steered response power (SRP). The simulation results demonstrate that the proposed algorithm is superior to the other several algorithms at low signal-to-noise ratio.

Abstract:Direction-of-arrival (DOA) estimation is a fundamental task in audio signal processing that becomes difficult in real-world environments due to the presence of reverberation. To address this difficulty, Direct-Path Dominance (DPD) tests have been proposed as an effective approach for detecting time-frequency (TF) bins dominated by direct sound, which contain accurate DOA information. These have been found to be particularly efficient when working with spherical arrays. While methods based on neural networks (NNs) have been developed to estimate the DOA, they have limitations such as the need for a large training database, and often understanding of the system's operation is lacking. This work proposes two novel DPD-test methods based on a model-based deep learning approach that combines the original DPD-test model with a data-driven system. Thus, it is possible to preserve the robustness of the original DPD-test across acoustic environments, while using a data-driven approach to better extract useful information about the direct sound, thereby enhancing the original method's performance. In particular, the paper investigates how energetic, temporal and spatial information contribute to the identification of TF-bins dominated by the direct signal. The proposed methods are trained on simulated data of a single sound source in a room, and evaluated on simulated and real data. The results show that energetic and temporal information provide new information about direct sound, which has not been considered in previous works and can improve its performance.

Abstract:Direction of arrival estimation (DOA) of multiple acoustic sources has been used for a wide range of applications, including room geometry inference, source separation and speech enhancement. The beamformer-based and subspace-based methods are most commonly used for spherical microphone arrays; however, the former suffers from spatial resolution limitations, while the later suffers from performance degradation in noisy environment. This letter proposes a multiple source DOA estimation approach based on the maximum likelihood method in the spherical harmonic domain and implements an efficient sequential iterative search of maxima on the cost function in the spherical harmonic domain. The proposed method avoids the division of the spherical Bessel function, which makes it suitable for both rigid-sphere and open-sphere configurations. Simulation results show that the proposed method has a significant superiority over the commonly used frequency smoothing multiple signal classification method. Experiments in a normal listening room and a reverberation room validate the effectiveness of the proposed method.

Abstract:This paper proposes a two microphone-based source localization technique for multiple speech sources utilizing speech specific properties and novel clustering algorithms. Voiced speech is sparse in the frequency domain and can be represented by sinusoidal tracks via sinusoidal modeling which provides high local signal-to-noise ratio (SNR). By utilizing the inter-channel phase differences (IPDs) between the dual channels on the sinusoidal tracks, the source localization of the mixed multiple speech sources is turned into a clustering problem on the IPD versus frequency plot. The generalized mixture decomposition algorithm (GMDA) is used to cluster the groups of points corresponding to multiple sources and thus estimate the direction of arrival (DOA) of the sources. Experiments illustrate the proposed GMDA algorithm with the Laplacian noise model can estimate the number of sources accurately and exhibits smaller DOA estimation error than the baseline histogram based DOA estimation algorithm in various scenarios including reverberant and additive white noise environments. Experiments suggest that appropriate power thresholding can be a simple and good approximation to the sinusoidal modeling, for the purpose of selecting time-frequency points with high local SNR, with slight loss in performance.
