Abstract:The functional principal component analysis (FPCA) method can effectively solve the problems of the high dimensionality of data, large information redundancy, and noise interference in hyperspectral image (HSI) classification. However, this unsupervised FPCA cannot make full use of the label information of training samples or spatial information, so that it is impossible to obtain satisfactory classification results. In this letter, a set of improved FPCA methods for HSI classification are proposed. First, the B-spline basis system is used to establish the functional data fitting model, which can convert discrete spectral information into continuous spectral curves and lay the foundation for functional feature extraction. Second, a supervised FPCA (SFPCA) method is built for extracting more effective functional features by making full use of the label information of training samples. Furthermore, to overcome the lack of training samples, two semisupervised FPCA (SSFPCA) methods are proposed for extracting more discriminative functional features and improving the classification accuracies. Finally, we perform the local mean filtering method on the HSI in order to extract the spatial information for each pixel, and then design spectral-spatial classification frameworks based on improved FPCA. Experiments on the commonly used HSI dataset show that improved FPCA can achieve higher classification accuracies than FPCA, and the proposed functional spectral-spatial classification frameworks can greatly improve classification accuracies.

Abstract:<p>Spatial information explored by superpixels can provide significant improvement for the accuracy of hyperspectral image classification. However, superpixels based sparse representation classification (SSRC) methods always introduce joint sparse pattern, which leads to the higher computational complexity. In this paper, a novel superpixel-feature-based multiple kernel sparse representation classification (SFMKSRC) method is proposed. Different from the traditional SSRC methods, SFMKSRC develops two new kinds of superpixel-based features by exploiting local mean operator within superpixels and weighted average operator among superpixels, which can describe the spatial information from both the local and global perspectives. Also, the novel superpixel-based features can avoid joint reconstruction to reduce the computational complexity. Then, the spectral-spatial features are extracted to combine with superpixels-based features and capture the detail structures of HSI to improve the classification performance. As pixels in high-dimensional feature space always trend to be linearly inseparable, a novel SFMKSRC model is designed to address the linearly inseparable problem of HSI classification. In addition, composite kernel constructed by generating base kernels for different features and optimally determining the weights of base kernels is embedded into MKSRC to exploit the strong correlations among different features while still preserve their diversities in a more flexible way. Experimental results on three real-world HSI datasets demonstrated that the proposed SFMKSRC method obtains a competitive performance and outperforms several state-of-the-art classification methods.</p>

Superpixel-Based Multiple Statistical Feature Extraction Method for Classification of Hyperspectral Images

Abstract:To improve the classification accuracies of hyperspectral images (HSIs), especially when using a limited number of training samples, a novel superpixel-based multiple statistical feature extraction (SPMSFE) method is proposed in this article. For each dimension-reduced pixel obtained by maximum noise fraction (MNF), the most similar superpixel-based neighbors of different sizes are first identified based on the spatial structures of the HSIs to exploit contextual spatial information accurately. Then, multiple statistical features, including the mean, covariance descriptor, and the Gaussian feature, are extracted for the set of superpixel-based neighbors to fully explore the spatial geometry information, tight correlations between different spectral bands, and spatial–spectral variations from different perspectives, respectively. In addition, these three statistical features of the pixels share the same size and can be utilized for uniform classification without any dimensionality obstacles even though the sizes of the superpixel-based neighbors for different pixels may be different. Next, we construct multiple kernels to map these multiple statistical features in the Euclidean and Riemannian manifold spaces to a uniform Hilbert space and embed them into a multitask kernelized sparse representation classification (MTKSRC) model. The constructed MTKSRC model provides a natural method to effectively fuse the multiple statistical features for excellent classification performance and robustness, especially when using limited numbers of training samples. The experimental results for three widely used HSI data sets demonstrate that the classification accuracy of the proposed SPMSFE method outperforms several latest and state-of-the-art classification methods by a large margin.

Abstract:In hyperspectral image (HSI) classification, a big challenge is the limited sample size with a relatively high feature dimension. Therefore, effective feature extraction of data is essential, which is desired to remove the redundancy as well as improve the discrimination. A huge number of methods have been proposed for HSI feature extraction. In recent years, deep learning-based feature extraction algorithms have shown their superiorities in various classification problems. Within them, deep PCA (DPCA) is a simple but efficient algorithm, which runs fast due to the absence of back-propagation. However, DPCA fails to provide satisfactory classification accuracies on HSI datasets. In this paper, we try to combine DPCA with residual-based multi-scale feature extraction and propose a residual deep PCA (RDPCA) feature extraction algorithm for HSI classification. It is a hierarchical approach consisting of multiple layers. Within each layer, PCA is utilized for layer-wise feature extraction, and the reconstruction residual is fed into the next layer. When the feature is passed deeper into the RDPCA network, finer details are mined. The layer-wise features are concatenated to form the final output feature. Furthermore, to enhance the ability of nonlinear feature extraction, we add activation functions between adjacent layers. Experimental results on real-world HSI datasets have shown the superiority of the proposed RDPCA over DPCA and PCA.

Abstract:In this paper, a novel spectral-spatial joint sparse representation algorithm for hyperspectral image classification is proposed based on multi-layer superpixels in various scales. Superpixels of various scales can provide complete yet redundant correlated information of the class attribute for test pixels. Therefore, we design a joint sparse model for a test pixel by sampling similar pixels from its corresponding superpixels combinations. Firstly, multi-layer superpixels are extracted on the false color image of the HSI data by principal components analysis model. Secondly, a group of discriminative sampling pixels are exploited as reconstruction matrix of test pixel which can be jointly represented by the structured dictionary and recovered sparse coefficients. Thirdly, the orthogonal matching pursuit strategy is employed for estimating sparse vector for the test pixel. In each iteration, the approximation can be computed from the dictionary and corresponding sparse vector. Finally, the class label of test pixel can be directly determined with minimum reconstruction error between the reconstruction matrix and its approximation. The advantages of this algorithm lie in the development of complete neighborhood and homogeneous pixels to share a common sparsity pattern, and it is able to achieve more flexible joint sparse coding of spectral-spatial information. Experimental results on three real hyperspectral datasets show that the proposed joint sparse model can achieve better performance than a series of excellent sparse classification methods and superpixels-based classification methods.

Abstract:Hyperspectral remotely sensed images contain not only the spatial information of ground objects, but also their rich spectral information. Effectively improve the classification accuracy of hyperspectral images (HSIs), the purpose is to accurately grasp the current land resource utilization information, which is of great significance to the formulation and implementation of future land and space planning. Existing research on the classification of hyperspectral remotely sensed images uses a single-scale superpixel method for image segmentation. The optimal number of superpixels cannot be determined, image details may get missed, and a single kernel matrix cannot represent the information from multiple features, which results in reduced classification accuracy. Therefore, this study intends to use the superpixel segmentation method to perform multiscale superpixel segmentation on the principal components of HSIs at multiple scales, and to couple the multiscale superpixel spatial spectral kernel (SSK) with the original spectral kernel to form a synthetic kernel using weights for HSI classification. The three HSIs of Pavia University, Pavia Center, and Washington DC Mall are used as the experimental data to test and analyze this method. The experimental results show that the effective classification accuracies for the three datasets obtained by this method are 5.28%, 5.90%, and 7.71% higher than the five comparison methods, at best. The results prove that this method can effectively solve the problem of imprecise image feature extraction and an unknown number of initial superpixels and can significantly improve the classification accuracy of HSIs.

Abstract:Data-driven deep neural networks have demonstrated their superiority in high-resolution remote-sensing image (HRSI) classification based on superpixel-based objects. Currently, most HRSI classification methods that combine deep learning and superpixel object segmentation use multiple scales of stacking to satisfy the contextual semantic-information extraction of one analyzed object. However, this approach does not consider the long-distance dependencies between objects, which not only weakens the representation of feature information but also increases computational redundancy. To solve this problem, a superpixel-based long-range dependent network is proposed for HRSI classification. First, a superpixel segmentation algorithm is used to segment HRSI into homogeneous analysis objects as input. Secondly, a multi-channel deep convolutional neural network is proposed for the feature mapping of the analysis objects. Finally, we design a long-range dependent framework based on a long short-term memory (LSTM) network for obtaining contextual relationships and outputting classes of analysis objects. Additionally, we define the semantic range and investigate how it affects classification accuracy. A test is conducted by using two HRSI with overall accuracy (0.79, 0.76) and kappa coefficients (kappa) (0.92, 0.89). Both qualitative and quantitative comparisons are adopted to test the proposed method's efficacy. Findings concluded that the proposed method is competitive and consistently superior to the benchmark comparison method.

Abstract:Developing denoising algorithms for hyperspectral remote sensing images (HSIs) can alleviate noise problem, improve data utilization as well as the accuracy of subsequent applications. However, existing denoising techniques are usually unstable due to the variations of landscapes, resulting in local distortion of HSIs, especially in heterogeneous areas. To tackle this issue, we propose a spatial–spectral interactive restoration (SSIR) framework by exploiting the complementarity of model-based and data-driven methods. Specifically, a deep learning-based denoising module that incorporates both convolutional neural networks (CNN) and Swin Transformer (TF) blocks is designed. This denoiser can achieve local–global dependencies modeling and content-based interactions to better capture global heterogeneity differences in HSIs. Moreover, we introduce an unsupervised unmixing module that utilizes spectral autocorrelation as prior information to effectively capture the differences in reflectance characteristics among different land cover components. This parameter-free module further improves the generalization ability of SSIR and enables stable denoising performance across different scenarios. Both modules are iteratively updated and fuel each other in SSIR. The proposed SSIR is shown to outperform others in preserving spatial details, maintaining spectral fidelity, and adapting to different landscapes based on simulated and real experiments conducted on various HSIs under diverse noise conditions.

Abstract:This paper presents a new technique for hyperspectral image (HSI) classification by using superpixel guided deep-sparse-representation learning. The proposed technique constructs a hierarchical architecture by exploiting the sparse coding to learn the HSI representation. Specifically, a multiple-layer architecture using different superpixel maps is designed, where each superpixel map is generated by downsampling the superpixels gradually along with enlarged spatial regions for labeled samples. In each layer, sparse representation of pixels within every spatial region is computed to construct a histogram via the sum-pooling with $l_{1}$ normalization. Finally, the representations (features) learned from the multiple-layer network are aggregated and trained by a support vector machine classifier. The proposed technique has been evaluated over three public HSI data sets, including the Indian Pines image set, the Salinas image set, and the University of Pavia image set. Experiments show superior performance compared with the state-of-the-art methods.
Spectral–Spatial and Superpixelwise Unsupervised Linear Discriminant Analysis for Feature Extraction and Classification of Hyperspectral Images

Abstract:Dimensionality reduction (DR) is important for feature extraction and classification of hyperspectral images (HSIs). Recently proposed superpixel-based DR models have shown promising performance, where superpixel segmentation techniques were applied to segment an HSI and then DR models like principal component analysis (PCA) or linear discriminant analysis (LDA) were employed to extract the local and/or global features. However, superpixelwise PCA (SuperPCA)-based local features are unsatisfactory because PCA aims to extract features with high variance, which could be inefficient in superpixels with mixed objects or strong noise/outliers. In addition, superpixelwise unsupervised LDA (SuperULDA) based global features may neglect local (spatial-contextual) information. To address these issues, we propose a new spectral–spatial and superpixelwise unsupervised LDA (S3-ULDA) model for unsupervised feature extraction from HSIs. Specifically, the HSI is first segmented into various superpixels with pseudo labels. Then, superpixel-based local reconstruction for HSI denoising is conducted. Next, SuperULDA is performed on both the original HSI and locally reconstructed data to extract global features. Then, superpixelwise unsupervised local Fisher discriminant analysis (SuperULFDA) is developed for local feature extraction, where each superpixel and its adjacent superpixels (along with their pseudo-labels) are fed into local Fisher discriminant analysis (LFDA) to extract local features. The superpixel-level local manifold structures can be effectively modeled by the proposed SuperULFDA. Finally, by fusing the extracted global and local features, novel global–local and spectral–spatial features can be obtained. Our experimental results on several benchmark HSIs demonstrate the superiority of the proposed method over state-of-the-art methods. Abstract:This paper first suggests a novel parameter‐free superpixel merging technique. Then a superpixel smoothing method is introduced by using merged superpixels. Finally, an effective spectral–spatial HSI classification scheme is proposed based on smoothed superpixels and a broad learning system. Most spectral–spatial classification methods for hyperspectral images (HSIs) can achieve satisfactory classification results. However, the common problem faced with these approaches is the need for a long training time and sufficient training samples. To address this issue, this study proposes an effective spectral–spatial HSI classification method based on superpixel merging, superpixel smoothing and broad learning system (SMS‐BLS). The newly introduced parameter‐free superpixel merging technique based on local modularity not only enhances the role of local spatial information in classification, but also maintains class boundary information as much as possible. In addition, the spectral and spatial information of HSIs is further fused during the superpixel smoothing process. As a result, with limited training samples, using merged and smoothed superpixels instead of pixels as input to the broad learning system significantly improves its classification performance. Moreover, the merged superpixels weaken the dependence of the classification results on the superpixel segmentation scale. The effectiveness of the proposed method was validated on three HSI benchmarks, namely Indian Pines, Pavia University and Salinas. Experimental and comparative results show the superiority of the method to other state‐of‐the‐art approaches in terms of overall accuracy and running time.

Abstract:We propose a hybridized technique named Spatial-Spectral-Superpixelwise PCA-based Dense 2D-3D CNN Fusion Architecture (3SPCA-D-2D-3D-CNN), that deals with the detailed and complex study of dimensionality reduction and classification of Hyperspectal images (HSI). Our work is 2-fold: At first (1), 3SPCA is applied on raw HSI that adopts superpixels-based local reconstruction to filter the images, whereas PCA-based supplementary global features acquire the relevant and low-dimensional local features. Every HSI pixel is reconstituted by the pixels of its closest neighbors in the same superpixel block to reduce noise and improve spatial information. Next, PCA is conducted on every zone and the full HSI to get local and global features. The local-global and spatial-spectral properties are then concatenated. Secondly (2), the D-2D-3D-CNN fusion architecture is made up of three 3D convolution blocks, two 2D convolution blocks with varied kernel sizes and filters, and four fully connected (FC) dense layers, totaling nine distinguishing and information-enriched features. These features can generate precise class labels and apply them to the appropriate landcovers. The proposed method has been applied to three publicly available HSI landcover datasets, the Indian Pines, the Salinas Valley, and the Pavia University. It achieved respectively 98.33%, 99.99%, and 98.73% average accuracy scores. Due to its improved Feature Extraction capacity from a limited number of training samples and its classification performance with fewer epochs, this method outperforms other relevant state-of-the-art CNN-based methods.

Abstract:Hyperspectral images (HSIs) contain rich spectral information and spatial information. How to apply these two information types and fully combine the correlation between them remains a challenge worthy of further research and discussion. In this study, a multi-branchmulti-scale residual fusion network (MB-MS-RFN) for HSI classification is proposed. First, a 3D multi-branch-multi-scale convolution residual network, which can acquire image features of different scale in the training process and consider the correlation between spectral information and spatial information, is developed. Instead of deepening the network, the multi-branch structure widens the network horizontally to obtain more accurate classification. Finally, the different levels of HSI features are fused to obtain better classification results. Several experiments have been carried out to verify the proposed framework, and the results have demonstrated that the proposed MB-MS-RFN framework can improve the classification performance of HSIs. The performance of the MB-MS-RFN was evaluated using the Indian Pines, Pavia University, and Kennedy Space Center datasets; the performances' overall accuracies were 99.66%, 99.92%, and 99.97%, respectively. The results from a series of experiments confirm that the proposed method offers several advantages in classification accuracy compared with five other methods. Abstract:Hyperspectral image (HSI) super-resolution (SR) technology has made remarkable progress due to the development of deep learning (DL). However, the technique still faces two challenges, i.e., the imbalance between spectral and spatial information extraction, and the parameter deviation and high computational effort associated with 3-D convolution. In this article, we propose an SR method for remote sensing HSIs based on multidomain spatial information and multiscale spectral information fusion (MSSR). Specifically, inspired by the high degree of self-similarity of remote sensing HSIs, a spatial–spectral attention module based on dilated convolution (DSSA) for capturing global spatial information is proposed. The extraction of local spatial information is then accomplished by residual blocks using small-size convolution kernels. Meanwhile, we propose the 3-D inception module to efficiently mine multiscale spectral information. The module only retains the scale of the 3-D convolution kernel in spectral dimension, which greatly reduces the high computational cost caused by 3-D convolution. Comparative experimental results on four benchmark datasets demonstrate that compared with the current cutting-edge models, our method achieves state-of-the-art (SOTA) results and the model computation is greatly reduced.

Superpixel-based multi-scale multi-instance learning for hyperspectral image classification

Abstract:Superpixels can define meaningful local regions within a hyperspectral image (HSI) and have become the building blocks of various HSI classification methods. The superpixels in HSIs consist of multiple spectral pixels, sharing a similar structure with the data in multi-instance learning (MIL). However, the potential of MIL methods in the field of HSI classification has been rarely explored. In this paper, we propose the superpixel-based multi-scale multi-instance learning (MSMIL) framework, enhancing the superpixel representation with MIL for the first time. Segmenting the HSIs with superpixels, MSMIL converts the HSI classification into MIL problems and extracts superpixel representations via the MIL method, namely multi-instance factor analysis (MIFA). Compared with the existing methods focusing exclusively on the local information, MIFA utilizes the deviations from an overall generative model to describe the superpixels, retaining both the local and the global information. Moreover, MSMIL introduces multi-scale superpixels and a spectral-spatial decision fusion strategy for further refinement, where the results of multi-scale superpixel maps are weighted according to prediction certainty and spatial consistency. The proposed method is evaluated on four benchmark datasets and achieves competitive results. For example, MSMIL outperforms the comparison methods with a margin of 5% overall accuracy on the Indian Pines dataset, when 2% pixels are selected as the training set.

Abstract:Hyperspectral images (HSIs) consist of hundreds of spectral bands, which can be used to precisely characterize different land cover types. However, an HSI has redundant information and is prone to the "dimensionality curse." Therefore, it is necessary to reduce redundant information through dimensionality reduction (DR), given that different dimensions contain unique primary feature information, and the feature information is complementary. Accordingly, a new feature extraction method based on multidimensional spectral regression whitening (M-SRW) is proposed, which reduces HSI to different dimensions and reconstructs it for feature extraction. The proposed method consists of the following steps: First, the original HSI is superpixel segmented by the entropy rate segmentation algorithm. Second, SRW is performed in each superpixel block to reduce the dimension of each superpixel block to a different dimension. Third, superpixel blocks of the same dimension are combined to obtain the reconstructed HSI. Finally, the support vector machine is utilized to classify the reconstructed HSI of different dimensions, and majority voting decision fusion is used to obtain the final classification result map. Experiments on three public hyperspectral data sets demonstrated that the proposed M-SRW method is superior to several state-of-the-art feature extraction approaches in terms of classification accuracy.

Abstract:The unique characteristics of hyperspectral images (HSI) undoubtedly pose significant categorization issues while providing a wealth of information. High redundancy and a lack of samples with labels are two main issues. Since convolutional neural networks were developed, several different network models have been utilized for hyperspectral image categorization. In this research, we introduce a multiscale piecewise spectral-spatial attention network (MPSSAN) that improves accuracy with fewer labelled samples. Concretely, we first randomly partition several groups to address the high dimensionality of hyperspectral data, and then the principal component analysis is utilized for dimension reduction. Following that, two multi-branch structures are employed to extract spectral and spatial features, and the features of multi-branch structures interact with each other to improve information flow. In addition, the designed double-scale attention mechanism could assign greater weight to crucial spectral-spatial features for further capturing effective HSI information. Experiments run on three datasets to test the model's efficacy, and several popular deep-learning methods are selected for comparison experiments. The experimental findings demonstrate that the proposed MPSSAN enhances classification performance when compared to some state-of-the-art methods. Our method's overall accuracy is 98.93% for the Indian Pines (IN) dataset and 99.68% for the Kennedy Space Center (KSC) dataset with 10% samples. On the University of Pavia (UP) dataset, 1% of training samples achieve an overall accuracy of 98.46%.

Abstract:Recently, the rapid development of deep learning has greatly improved the performance of image classification. However, a central problem in hyperspectral image (HSI) classification is spectral uncertainty, where spectral features alone cannot accurately and robustly identify a pixel point in a hyperspectral image. This paper presents a novel HSI classification network called MS-RPNet, i.e., multiscale superpixelwise RPNet, which combines superpixel-based S-3-PCA with two-dimensional singular spectrum analysis (2D-SSA) based on the Random Patches Network (RPNet). The proposed frame can not only take advantage of the data-driven method, but can also apply S-3-PCA to efficiently consider more global and local spectral knowledge at the super-pixel level. Meanwhile, 2D-SSA is used for noise removal and spatial feature extraction. Then, the final features are obtained by random patch convolution and other steps according to the cascade structure of RPNet. The layered extraction superimposes the different sparial information into multi-scale spatial features, which complements the features of various land covers. Finally, the final fusion features are classified by SVM to obtain the final classification results. The experimental results in several HSI datasets demonstrate the effectiveness and efficiency of MS-RPNet, which outperforms several current state-of-the-art methods.
Advanced Hyperspectral Image Analysis: Superpixelwise Multiscale Adaptive T-HOSVD for 3D Feature Extraction

Abstract:Hyperspectral images (HSIs) possess an inherent three-order structure, prompting increased interest in extracting 3D features. Tensor analysis and low-rank representations, notably truncated higher-order SVD (T-HOSVD), have gained prominence for this purpose. However, determining the optimal order and addressing sensitivity to changes in data distribution remain challenging. To tackle these issues, this paper introduces an unsupervised Superpixelwise Multiscale Adaptive T-HOSVD (SmaT-HOSVD) method. Leveraging superpixel segmentation, the algorithm identifies homogeneous regions, facilitating the extraction of local features to enhance spatial contextual information within the image. Subsequently, T-HOSVD is adaptively applied to the obtained superpixel blocks for feature extraction and fusion across different scales. SmaT-HOSVD harnesses superpixel blocks and low-rank representations to extract 3D features, effectively capturing both spectral and spatial information of HSIs. By integrating optimal-rank estimation and multiscale fusion strategies, it acquires more comprehensive low-rank information and mitigates sensitivity to data variations. Notably, when trained on subsets comprising 2%, 1%, and 1% of the Indian Pines, University of Pavia, and Salinas datasets, respectively, SmaT-HOSVD achieves impressive overall accuracies of 93.31%, 97.21%, and 99.25%, while maintaining excellent efficiency. Future research will explore SmaT-HOSVD's applicability in deep-sea HSI classification and pursue additional avenues for advancing the field.

Abstract:Hyperspectralimages (HSIs) can provide powerful spectral discriminative information for the land-covers, thus is widely used in classification and target detection. However, HSIs always suffer from the curse of high dimensionality due the high spectral dimension, therefore dimension reduction and feature extraction are essential for the application of HSIs. In this paper, we propose an unsupervised feature extraction method for HSIs using combined low rank representation and locally linear embedding (LRR and LLE). LRR can structurally represent the intrinsic property of union of low-rank subspaces and LLE can employ the spatial correlation information. Two real HSI datasets are used in the experiments and the classification results using support vector machine (SVM) demonstrate that the features extracted by LRR LLE are more discriminative than the state-of-art methods. The classification accuracy of LRR LLE versus IR improved by an average of 4.47% and 2.97% on OA and AA, respectively; compared with the original data, it increased by approximately 12.07% and 7.35%.
