Abstract:With the development of self-driving technology, pedestrian detection models are becoming more useful and important. Although object detection models based on Convolutional Neural Networks have achieved favorable detection results, due to the occlusion in crowded scenarios, dense pedestrian detection is still a challenging task compared with generic object detection. For a CNN-based object detector, an appropriate label assignment method is significant. In this paper, we propose an effective training sample allocation method called Occlusion-Prediction aware Label Assignment (OPLA) to improve the performance of the detector in crowded scenarios. For those Ground Truths (GTs) without severe occlusion, we directly assign prediction boxes with the best matching quality as the corresponding positive samples. In terms of GTs in heavily crowded areas, we fine-tune the matching quality based on visible ratio to enhance the training sample selection priority of severe occluded GTs. In addition, we reveal the deficiency of currently popular post-processing algorithms, Non-Maximum Suppression (NMS) and Soft-NMS for dense pedestrian detection, and propose Hierarchical-NMS (H-NMS) whose strategy diverges with different Intersection over Union (IoU) levels. Experimental results on Crowdhuman, the largest dense pedestrian detection dataset at present, show our approach optimizes the Average Precision (AP) and Miss Rate (MR) of Fully Convolutional One Stage Object Detection (FCOS) by 4.05% and 5.35% and outperforms many state-of-the-art detectors, respectively. Besides, our method does not bring any increase in calculation during inference.

Abstract:The pedestrian detection is a hot research topic in computer recognition. It involves not only the pedestrian location information but also the intrusion detection function, which has wide prospects in the application of vehicle traffic, campus monitoring, and building guard. However, the identification accuracy and recognition speed play an important role in the pedestrian detection, which calls for a fast pedestrian detection approach. The general pedestrian detection implementation, based on the integral channel features method and soft cascade classifier, is the popular technique in the current business application since its better speed and accuracy. Thus, this method uses the feature approximation technique and multiple classifiers to achieve the feature computing, which speeds up the detection without resizing image. To this end, this paper is motived to propose a multi-scale handling method for the fast pedestrian detection, using the tactics detection from sparse to dense. Our pedestrian detection method consists of four parts functions, mainly pedestrian statistics and intrusion detection, pedestrian tracking and pedestrian flow statistics. All these modules are introduced with its details about design and implementation. In Addition, the proposed multi-scale handling method can be applied into most of object detectors to improve their recognition speed. In conclusion, our proposed approach has a good potential application prospect in the video surveillance system.

Abstract:In defect of intelligent assistant approaches, the visually impaired feel hard to cross the roads in urban environments. Aiming to tackle the problem, a real-time Pedestrian Crossing Lights (PCL) detection algorithm for the visually impaired is proposed in this paper. Different from previous works which utilize analytic image processing to detect the PCL in ideal scenarios, the proposed algorithm detects PCL using machine learning scheme in the challenging scenarios, where PCL have arbitrary sizes and locations in acquired image and suffer from the shake and movement of camera. In order to achieve the robustness and efficiency in those scenarios, the detection algorithm is designed to include three procedures: candidate extraction, candidate recognition and temporal-spatial analysis. A public dataset of PCL, which includes manually labeled ground truth data, is established for tuning parameters, training samples and evaluating the performance. The algorithm is implemented on a portable PC with color camera. The experiments carried out in various practical scenarios prove that the precision and recall of detection are both close to 100%, meanwhile the frame rate is up to 21 frames per second (FPS).
Pedestrian Detection Method Based on Improved YOLOv5s for Densely Occluded Scenarios

Abstract:In response to the issues of low accuracy and high false negatives in real-time detection of densely occluded pedestrians, a pedestrian detection method based on improved YOLOv5s is proposed. This method involves replacing the Centralized-Comprehensive Convolution Block (C3) module in the backbone network with the DenseBlock module to enhance the model's feature extraction capabilities for small targets. The Efficient Intersection over Union (EIoU) loss function was used instead of the Complete Intersection over Union (CIoU) loss function to improve the model's ability to accurately locate densely occluded targets. Based on the feature pyramid structure, the Adaptive Spatial Feature Fusion (ASFF) module was introduced, enhancing the network's feature extraction capability. The introduction of the multi-head self-attention (MHSA) mechanism has enhanced the model's adaptability. The experimental results indicate that the improved YOLOv5s algorithm achieves mAP0.5 and mAP0.5:0.95 of 78.6% and 48.7%, respectively, on the CrowdHuman dataset. This represents an improvement of 2.0% and 2.2% compared to the initial YOLOv5s. The detection time is 11.4ms, showing good robustness for detecting targets of different sizes and meeting real-time requirements.

Abstract:Pedestrian detection attracts much attention from the academic community since it is an essential and significant component of autonomous driving. Despite many similarities with general object detection, pedestrian detection still has unique challenges such as background false positives and missed detections in a crowd. In this paper, we explore the value of contextual information for pedestrian detection, arguing that the contextual information is not a panacea in all cases. Despite the importance of enriching context, a method should focus on the core area where there is the target instance. To this end, we propose a pedestrian detection framework that extends proposals to enrich the context and relieves the confusions caused by contextual information through a supervised attention module. The ablation study demonstrates that the proposed extension is effective for both crowded and non-crowded instances; moreover, the attention module narrows the precision gap between these two cases. The extensive experiments on commonly used pedestrian benchmarks are conducted, which show the superior performance of our method. We achieve the average precision of 74.78% on KITTI pedestrian benchmark with the hard metric level, ranking the first places among all methods.
Pedestrian Detection Based on Center, Temperature, Scale and Ratio Prediction in Thermal Imagery

Abstract:Pedestrian detection has become an important branch in the field of object detection. However, pedestrian detection algorithms based on visible imagery meet many challenges under low lighting or no lighting conditions. Thermal imagery can effectively compensate the information loss of visible imagery in the night environment. In order to solve the problem of pedestrian detection at night or in other bad conditions with limited vision, a pedestrian detection method based on center, temperature, scale and ratio prediction in thermal imagery is proposed. The proposed method contains two parts: (1) feature extraction part; and (2) center, temperature, scale and ratio prediction part. The feature extraction part uses ResNet-101 network to extract high-level semantic features from input thermal imagery. In the center, temperature, scale and ratio prediction part, the center branch is to determine whether there is a target center point in each position of feature map, which is a binary classification problem. The temperature branch is to determine whether the center point is a pedestrian target radiating heat or the background. Scale prediction branch and aspect ratio prediction branch are to determine the size of the target, which is a regression problem. We test the proposed detection method in FLIR advanced driver assistance system (ADAS) dataset. Experimental results show that the proposed method can effectively deal with pedestrian detection in low light and dark environment, and its detection performance is better than that of the baseline of nighttime pedestrian detection methods.

Abstract:Recent pedestrian detection methods generally rely on additional supervision, such as visible bounding-box annotations, to handle heavy occlusions. We propose an approach that leverages pedestrian count and proposal similarity information within a two-stage pedestrian detection framework. Both pedestrian count and proposal similarity are derived from standard full-body annotations commonly used to train pedestrian detectors. We introduce a count-weighted detection loss function that assigns higher weights to the detection errors occurring at highly overlapping pedestrians. The proposed loss function is utilized at both stages of the two-stage detector. We further introduce a count-and-similarity branch within the two-stage detection framework, which predicts pedestrian count as well as proposal similarity. Lastly, we introduce a count and similarity-aware NMS strategy to identify distinct proposals. Our approach requires neither part information nor visible bounding-box annotations. Experiments are performed on the CityPersons and CrowdHuman datasets. Our method sets a new state-of-the-art on both datasets. Further, it achieves an absolute gain of 2.4% over the current state-of-the-art, in terms of log-average miss rate, on the heavily occluded (HO) set of CityPersons test set. Finally, we demonstrate the applicability of our approach for the problem of human instance segmentation. Code and models are available at: https://github.com/Leotju/CaSe.

Abstract:In order to solve the problem of crowd counting and crowd density statistics in the security intelligent video surveillance system, this paper adopts the method based on deep learning to optimize the algorithm. This method mainly uses the VGG16 backbone network with 1*1 and 3*3 small convolution Classification and feature extraction of people information in a crowd. In order to reduce the sharp reduction in the number of positive samples after increasing the threshold, and to avoid the situation where using different thresholds during training and testing will cause the performance of the detector to degrade, this paper draws on the cascade structure of the Cascade R-CNN network for input video. The frame images are analyzed and processed, and different IoU thresholds are set at different stages to obtain enough positive samples to reduce over-fitting, and use the multi-task loss function and the Hadamard product to obtain the pedestrian detection network, and output the final number of people. The improved pedestrian counting algorithm in this paper is tested in the public dataset WorldExpo'10 Crowd Counting, and compared with other algorithms to verify the feasibility and effectiveness of this method.

Abstract:Under complex scene urban environment, in order to detect pedestrians efficiently and accurately, we propose a high real-time and robust performance pedestrian detection method based on machine vision in this paper. Firstly, a new feature called Locally Assembled Binary Haar-like (LABH) is selected as the feature vector. In this novel feature, Haar features keep only the ordinal relationship named by binary Haar feature, then, brings in similar idea of Local Binary Patter (LBP), assemble several neighboring binary Haar feature to improve the ability of illumination invariant and discriminating power. Furthermore, a full binary tree structure is presented to build on an efficient classifier, which has advantages of both series connection structure and parallel connection structure and brings in a principle of "Early-rejection", could improve system's real-time performance. The experiment carried out on videos from INRIA dataset, MIT dataset and Daimler dataset illustrates that the proposed method is real-time and feasible enough for pedestrian detection in intelligent vehicle environment.

Abstract:Pedestrian detection is an important branch of object detection due to its various applications. It plays a vital role in many fields such as intelligent surveillance systems. The recognition, identification and tracking modules of surveillance are based on efficient and accurate pedestrian detection. Our paper proposes an efficient model to solve real-time pedestrian detection with high accuracy based on modified ShuffleNet and YOLOv3 models. We provide a method to pick the dimensions and number of anchor boxes for predicting bounding boxes accurately. Then we use two improved shuffle units to lightweight the backbone of YOLOv3, which reduces the 67.5% floating point operations per second (FLOPs) and 65.1% parameters. We validate our model on CrowdHuman detection data set and get 62.7 mAP for face and 62.0 mAP person with 0.748 average IOU. Our network processes images in real-time at 186.1 frames per second for network and 12.5 frames per second for the entire model on CrowdHuman.

Abstract:Abstract Pedestrian detection is a kind of computer vision technology which is used to judge whether there is a pedestrian in a given image or video and estimate its position accurately. Pedestrian detection technology is widely used in intelligent security monitoring, driverless and robot fields. Pedestrian detection technology has nearly 30 years of development. Although it has greatly improved in accuracy and speed, there are problems such as lighting, pedestrian individual differences, occlusion and multi-scale pedestrian targets in the actual application scenarios, which lead to more missed and false detection in pedestrian detection. The algorithm is not robust enough, which makes the actual deployment difficult.

Abstract:Pedestrian detection in crowded scenes is a challenging problem, because occlusion happens frequently among different pedestrians. In this paper, we propose an effective and efficient detection network to hunt pedestrians in crowd scenes. The proposed method, namely PedHunter, introduces strong occlusion handling ability to existing region-based detection networks without bringing extra computations in the inference stage. Specifically, we design a mask-guided module to leverage the head information to enhance the feature representation learning of the backbone network. Moreover, we develop a strict classification criterion by improving the quality of positive samples during training to eliminate common false positives of pedestrian detection in crowded scenes. Besides, we present an occlusion-simulated data augmentation to enrich the pattern and quantity of occlusion samples to improve the occlusion robustness. As a consequent, we achieve state-of-the-art results on three pedestrian detection datasets including CityPersons, Caltech-USA and CrowdHuman. To facilitate further studies on the occluded pedestrian detection in surveillance scenes, we release a new pedestrian dataset, called SUR-PED, with a total of over 162k high-quality manually labeled instances in 10k images. The proposed dataset, source codes and trained models will be released.

YOLOv8-based Dense Pedestrian Detection Algorithm

Abstract:In scenarios with high pedestrian density, intricate backgrounds, and variable lighting conditions, pedestrian targets may overlap and appear small, leading to potential missed or false detections during the detection process. To address this, an enhanced YOLOv8-based pedestrian detection algorithm is proposed. Initially, YOLOv8 serves as the foundational model architecture. Building upon this, the RepVGGBlock module replaces the original Conv module, enhancing feature representation and facilitating accurate pedestrian identification in dense scenes. Furthermore, the Soft-NMS algorithm is employed in place of the traditional NMS algorithm, effectively reducing the missed detection rate of overlapped and occluded targets, thus improving model accuracy and recall rate. Additionally, CoordAttention is integrated into the YOLOv8 backbone network to mitigate overlap and occlusion issues by effectively integrating global and local information. Experimental results on the CrowdHuman dataset demonstrate precision of 82.92%, recall of 71.34%, mAP@.5 of 79.94%, and mAP@.5:.95 of 58.81%. Comparative analysis against the benchmark YOLOv8 model reveals improvements of 1.61% in precision, 6.78% in recall, 5.06% in mAP@.5, and 11.07% in mAP@.5:.95, indicating its enhanced suitability for dense pedestrian object detection tasks.

Pedestrian Target Recognition Algorithm in Public Places Based on Representation Learning and Similarity Learning

Abstract:To ensure public safety, the government has placed a lot of cameras in public places and used them to monitor key targets. In target detection, pedestrian target detection is undoubtedly a research hotspot. How to realize the high efficiency of pedestrian detection is the focus of this field. As a result, this research suggests an algorithm for pedestrian target detection in public spaces that is based on representation learning and similarity learning. The algorithm uses representation learning to extract pedestrian features and Singular Value Decomposition (SVD) to build a more trustworthy Feature Extraction Network (FEN). In addition, the improved Softmax function is used for similarity learning, and the K-Nearest Neighbor algorithm (KNN is applied for image retrieval to fgreatly increase the identification accuracy of pedestrians. The algorithm proposed in this study only needs two rounds of constraint training to achieve the best state. The mean absolute error and mean square error are 0.31 and 9.38, respectively. Its Relative Robustness (RR), Relative Generalization (RG) and Relative Scalability (RS) are excellent. In the final practical test, the model finally achieved 98.8% accuracy and 2.1% false positive rate. The proposed algorithm in this study has good application value in pedestrian target detection, and can better promote the development of social public safety

Abstract:In the realm of intelligent transportation, pedestrian detection has witnessed significant advancements. However, it continues to grapple with challenging issues, notably the detection of pedestrians in complex lighting scenarios. Conventional visible light mode imaging is profoundly affected by varying lighting conditions. Under optimal daytime lighting, visibility is enhanced, leading to superior pedestrian detection outcomes. Conversely, under low-light conditions, visible light mode imaging falters due to the inadequate provision of pedestrian target information, resulting in a marked decline in detection efficacy. In this context, infrared light mode imaging emerges as a valuable supplement, bolstering pedestrian information provision. This paper delves into pedestrian detection and tracking algorithms within a multi-modal image framework grounded in deep learning methodologies. Leveraging the YOLOv4 algorithm as a foundation, augmented by a channel stack fusion module, a novel multi-modal pedestrian detection algorithm tailored for intelligent transportation is proposed. This algorithm capitalizes on the fusion of visible and infrared light mode image features to enhance pedestrian detection performance amidst complex road environments. Experimental findings demonstrate that compared to the Visible-YOLOv4 algorithm, renowned for its high performance, the proposed Double-YOLOv4-CSE algorithm exhibits a notable improvement, boasting a 5.0% accuracy rate enhancement and a 6.9% reduction in logarithmic average missing rate. This research's goal is to ensure that the algorithm can run smoothly even on a low configuration 1080 Ti GPU and to improve the algorithm's coverage at the application layer, making it affordable and practical for both urban and rural areas. This addresses the broader research problem within the scope of smart cities and remote ends with limited computational power.
Research on rainy day traffic sign recognition algorithm based on PMRNet

Abstract:The recognition of traffic signs is of great significance to intelligent driving and traffic systems. Most current traffic sign recognition algorithms do not consider the impact of rainy weather. The rain marks will obscure the recognition target in the image, which will lead to the performance degradation of the algorithm, a problem that has yet to be solved. In order to improve the accuracy of traffic sign recognition in rainy weather, we propose a rainy traffic sign recognition algorithm. The algorithm in this paper includes two modules. First, we propose an image deraining algorithm based on the Progressive multi-scale residual network (PMRNet), which uses a multi-scale residual structure to extract features of different scales, so as to improve the utilization rate of the algorithm for information, combined with the Convolutional long-short term memory (ConvLSTM) network to enhance the algorithm's ability to extract rain mark features. Second, we use the CoT-YOLOv5 algorithm to recognize traffic signs on the recovered images. In this paper, in order to improve the performance of YOLOv5 (You-Only-Look-Once, YOLO), the 3 × 3 convolution in the feature extraction module is replaced by the Contextual Transformer (CoT) module to make up for the lack of global modeling capability of Convolutional Neural Network (CNN), thus improving the recognition accuracy. The experimental results show that the deraining algorithm based on PMRNet can effectively remove rain marks, and the evaluation indicators Peak Signal-to-Noise Ratio (PSNR) and Structural Similarity Index Measure (SSIM) are better than the other representative algorithms. The mean Average Precision (mAP) of the CoT-YOLOv5 algorithm on the TT100k datasets reaches 92.1%, which is 5% higher than the original YOLOv5.

Abstract:Pedestrian detection is a challenging and hot research topic in the field of computer vision, especially for the crowded scenes where occlusion happens frequently. In this paper, we propose a novel AutoPedestrian scheme that automatically augments the pedestrian data and searches for suitable loss functions, aiming for better performance of pedestrian detection especially in crowded scenes. To our best knowledge, it is the first work to automatically search the optimal policy of data augmentation and loss function jointly for the pedestrian detection. To achieve the goal of searching the optimal augmentation scheme and loss function jointly, we first formulate the data augmentation policy and loss function as probability distributions based on different hyper-parameters. Then, we apply a double-loop scheme with importance-sampling to solve the optimization problem of data augmentation and loss function types efficiently. Comprehensive experiments on two popular benchmarks of CrowdHuman and CityPersons show the effectiveness of our proposed method. In particular, we achieve 40.58% in MR on CrowdHuman datasets and 11.3% in MR on CityPersons reasonable subset, yielding new state-of-the-art results on these two datasets.

Attention-Guided Sample-Based Feature Enhancement Network for Crowded Pedestrian Detection Using Vision Sensors

Abstract:Occlusion presents a major obstacle in the development of pedestrian detection technologies utilizing computer vision. This challenge includes both inter-class occlusion caused by environmental objects obscuring pedestrians, and intra-class occlusion resulting from interactions between pedestrians. In complex and variable urban settings, these compounded occlusion patterns critically limit the efficacy of both one-stage and two-stage pedestrian detectors, leading to suboptimal detection performance. To address this, we introduce a novel architecture termed the Attention-Guided Feature Enhancement Network (AGFEN), designed within the deep convolutional neural network framework. AGFEN improves the semantic information of high-level features by mapping it onto low-level feature details through sampling, creating an effect comparable to mask modulation. This technique enhances both channel-level and spatial-level features concurrently without incurring additional annotation costs. Furthermore, we transition from a traditional one-to-one correspondence between proposals and predictions to a one-to-multiple paradigm, facilitating non-maximum suppression using the prediction set as the fundamental unit. Additionally, we integrate these methodologies by aggregating local features between regions of interest (RoI) through the reuse of classification weights, effectively mitigating false positives. Our experimental evaluations on three widely used datasets demonstrate that AGFEN achieves a 2.38% improvement over the baseline detector on the CrowdHuman dataset, underscoring its effectiveness and potential for advancing pedestrian detection technologies.

Abstract:In recent years, pedestrian re-identification technology has made significant progress, with various neural network models performing well under normal conditions, such as good weather and adequate lighting. However, most research has overlooked extreme environments, such as rainy weather and nighttime. Additionally, the existing pedestrian re-identification datasets predominantly consist of well-lit images. Although some studies have started to address these issues by proposing methods for enhancing low-light images to restore their original features, the effectiveness of these approaches remains limited. We noted that a method based on Retinex theory designed a reflectance representation learning module aimed at restoring image features as much as possible. However, this method has so far only been applied in object detection networks. In response to this, we improved the method and applied it to pedestrian re-identification, proposing a transposed convolution reflectance decoder (TransConvRefDecoder) to better restore details in low-light images. Extensive experiments on the Market1501, CUHK03, and MSMT17 datasets demonstrated that our approach delivered superior performance.

An Improved YOLOv7 Lightweight Detection Algorithm for Obscured Pedestrians

Abstract:The detection algorithm commonly misses obscured pedestrians in traffic scenes with a high pedestrian density because mutual occlusion among pedestrians reduces the prediction box score of the concealed pedestrians. The paper uses the YOLOv7 algorithm as the baseline and makes the following three improvements by investigating the variables influencing the detection method's performance: First, the backbone network of the YOLOv7 algorithm is replaced with the lightweight feature extraction network Mobilenetv3 since the pedestrian detection algorithm frequently needs to be deployed in driverless mobile, which requires a fast operating speed of the algorithm; second, a high-resolution feature pyramid structure is suggested for the issue of missed detection of hidden pedestrians, which upscales the feature maps generated from the feature pyramid to increase the resolution of the output feature maps and introduces shallow feature maps to strengthen the distinctions between adjacent sub-features to enhance the network's ability to extract features for the visible area of hidden pedestrians and small-sized pedestrians in order to produce deeper features with greater differentiation for pedestrians; and the third is to suggest a detection head based on an attention mechanism that is employed to lower the confidence level of target neighboring sub-features, lower the quantity of redundant detection boxes, and lower the following NMS computation. The mAP of the suggested approach in this work achieves 89.75%, which is 9.5 percentage points better than the YOLOv7 detection algorithm, according to experiments on the CrowdHuman pedestrian-intensive dataset. The algorithm proposed in this paper can considerably increase the detection performance of the detection algorithm, particularly for obscured pedestrians and small-sized pedestrians in the dataset, according to the experimental effect plots.
