Abstract:We experience surprise when reality conflicts with our expectations. When we encounter such expectation violations in psychological tasks and daily life, are we experiencing completely different forms of surprise? Or is surprise a fundamental psychological process with shared neural bases across contexts? To address this question, we identified a brain network model, the surprise edge-fluctuation-based predictive model (EFPM), whose regional interaction dynamics measured with functional magnetic resonance imaging (fMRI) predicted surprise in an adaptive learning task. The same model generalized to predict surprise as a separate group of individuals watched suspenseful basketball games and as a third group watched videos violating psychological expectations. The surprise EFPM also uniquely predicts surprise, capturing expectation violations better than models built from other brain networks, fMRI measures, and behavioral metrics. These results suggest that shared neurocognitive processes underlie surprise across contexts and that distinct experiences can be translated into the common space of brain dynamics.

Abstract:The quantitative measurement of how and when we experience surprise has mostly remained limited to laboratory studies, and its extension to naturalistic settings has been challenging. Here we demonstrate, for the first time, how computational models of surprise rooted in cognitive science and neuroscience combined with state-of-the-art machine learned generative models can be used to detect surprising human behavior in complex, dynamic environments like road traffic. In traffic safety, such models can support the identification of traffic conflicts, modeling of road user response time, and driving behavior evaluation for both human and autonomous drivers. We also present novel approaches to quantify surprise and use naturalistic driving scenarios to demonstrate a number of advantages over existing surprise measures from the literature. Modeling surprising behavior using learned generative models is a novel concept that can be generalized beyond traffic safety to any dynamic real-world environment.

The Detection of Unusual Events in Video Based on Bayesian Surprise Model

Abstract:Automatic detection of unusual events in video surveillance has proven to be a difficult task. It is shown that surprise is an important cue for the direction of human attention to unexpected events. Aiming to the difficulty of the definition and description of abnormity in videos, we present the use of Bayesian surprise, introduced in computer vision, for detection of certain types of unusual events. Multiple local monitors which collect low-level statistics (velocity or direction) are placed over the image. With the monitors' observation and a set of reference measurement previously acquired, a pixel-wise surprise trigger is computed using Bayesian probabilistic inference techniques. Once the surprise value exceed by a preset threshold, the monitor outputs an alert. These alerts are integrated to a final decision regarding the existence of an unusual event. It was tested on a variety of real-life crowded scenes. The results show that the proposed method localized the regions of anomalies in the abnormal frames successfully, thus demonstrating the practical applicability of the scheme.

Abstract:We consider the problem of inferring what happened to a person in a social task from momentary facial reactions. To approach this, we introduce several innovations. First, rather than predicting what (observers think) someone feels, we predict objective features of the event that immediately preceded the facial reactions. Second, we draw on appraisal theory, a key psychological theory of emotion, to characterize features of this immediately-preceded event. Specifically, we explore if facial expressions reveal if the event is expected, goal-congruent, and norm-compatible. Finally, we argue that emotional expressivity serves as a better feature for characterizing momentary expressions than traditional facial features. Specifically, we use supervised machine learning to predict third-party judgments of emotional expressivity with high accuracy, and show this model improves inferences about the nature of the event that preceded an emotional reaction. Contrary to common sense, “genuine smiles” failed to predict if an event advanced a person's goals. Rather, expressions best revealed if an event violated expectations. We discussed the implications of these findings for the interpretation of facial displays and potential limitations that could impact the generality of these findings.

Abstract:Communication, often grounded in shared expectations, faces challenges without common linguistic backgrounds. Our study explores how people instinctively turn to the fundamental principles of the physical world to overcome communication barriers. Specifically, through the Tacit Communication Game, we investigate how participants develop novel strategies for conveying messages without relying on common linguistic signals. We developed a new computational model built from the principle of expectancy violations of a set of common universal priors derived from movement kinetics. The model closely resembles the Sender’s messages, with its core variable – the information-theoretic surprise – explaining the Receiver’s physiological and neural responses. This is evidenced by a significant correlation with the pupil diameter, indicating cognitive effort, and neural activity in brain areas related to expectancy violations. This work highlights the adaptability of human communication, showing how surprise can be a powerful tool in forming new communicative strategies without relying on common language.

Abstract:In humans and animals, surprise is a physiological reaction to an unexpected event, but how surprise can be linked to plausible models of neuronal activity is an open problem. We propose a self-supervised spiking neural network model where a surprise signal is extracted from an increase in neural activity after an imbalance of excitation and inhibition. The surprise signal modulates synaptic plasticity via a three-factor learning rule which increases plasticity at moments of surprise. The surprise signal remains small when transitions between sensory events follow a previously learned rule but increases immediately after rule switching. In a spiking network with several modules, previously learned rules are protected against overwriting, as long as the number of modules is larger than the total number of rules—making a step towards solving the stability-plasticity dilemma in neuroscience. Our model relates the subjective notion of surprise to specific predictions on the circuit level. Everybody knows the subjective feeling of surprise and behavioral reactions to surprising events such as startle response and pupil dilation are widely studied—but how can surprise arise from neural activity? And why is surprise useful? To answer these questions we use a modeling approach. We design a self-supervised spiking neural network capable of extracting surprising information from its own activity. Surprise is measured by a mismatch between the representation of the current stimulus inside the model and the expectations of the model given previous stimuli. We propose a specific network architecture which allows the network—in combination with a three-factor NeoHebbian learning rule—to detect rule changes, signal these changes as a surprise signal, and in turn use the surprise signal to rapidly re-adapt the model's predictions of possible next stimuli. Our bottom-up model presents a concrete hypothesis of a bio-plausible implementation of surprise and makes several specific experimental predictions for future in vivo studies.

Abstract:Information flow measures, over the duration of a game, the audience's belief of who will win, and thus can reflect the amount of surprise in a game. To quantify the relationship between information flow and audiences' perceived quality, we conduct a case study where subjects watch one of the world's biggest esports events, LOL S10. In addition to eliciting information flow, we also ask subjects to report their rating for each game. We find that the amount of surprise in the end of the game plays a dominant role in predicting the rating. This suggests the importance of incorporating when the surprise occurs, in addition to the amount of surprise, in perceived quality models. For content providers, it implies that everything else being equal, it is better for twists to be more likely to happen toward the end of a show rather than uniformly throughout.

Abstract:In the specific area of Software Engineering (SE) for self-adaptive systems (SASs) there is a growing research awareness about the synergy between SE and Artificial Intelligence (AI). However, just few significant results have been published so far. In this paper, we propose a novel and formal Bayesian definition of surprise as the basis for quantitative analysis to measure degrees of uncertainty and deviations of self-adaptive systems from normal behavior. A surprise measures how observed data affects the models or assumptions of the world during runtime. The key idea is that a "surprising'' event can be defined as one that causes a large divergence between the belief distributions prior to and posterior to the event occurring. In such a case the system may decide either to adapt accordingly or to flag that an abnormal situation is happening. In this paper, we discuss possible applications of Bayesian theory of surprise for the case of self-adaptive systems using Bayesian dynamic decision networks.

Abstract:The human intrinsic desire to pursue knowledge, also known as curiosity, is considered essential in the process of skill acquisition. With the aid of artificial curiosity, we could equip current techniques for control, such as Reinforcement Learning, with more natural exploration capabilities. A promising approach in this respect has consisted of using Bayesian surprise on model parameters, i.e. a metric for the difference between prior and posterior beliefs, to favour exploration. In this contribution, we propose to apply Bayesian surprise in a latent space representing the agent’s current understanding of the dynamics of the system, drastically reducing the computational costs. We extensively evaluate our method by measuring the agent's performance in terms of environment exploration, for continuous tasks, and looking at the game scores achieved, for video games. Our model is computationally cheap and compares positively with current state-of-the-art methods on several problems. We also investigate the effects caused by stochasticity in the environment, which is often a failure case for curiosity-driven agents. In this regime, the results suggest that our approach is resilient to stochastic transitions.
Dynamic expectations: Behavioral and electrophysiological evidence of sub-second updates in reward predictions

Abstract:Expectations are often dynamic: sports fans know that expectations are rapidly updated as games unfold. Yet expectations have traditionally been studied as static. Here we present behavioral and electrophysiological evidence of sub-second changes in expectations using slot machines as a case study. In Study 1, we demonstrate that EEG signal before the slot machine stops varies based on proximity to winning. Study 2 introduces a behavioral paradigm to measure dynamic expectations via betting, and shows that expectation trajectories vary as a function of winning proximity. Notably, these expectation trajectories parallel Study 1's EEG activity. Studies 3 (EEG) and 4 (behavioral) replicate these findings in the loss domain. These four studies provide compelling evidence that dynamic sub-second updates in expectations can be behaviorally and electrophysiologically measured. Our research opens promising avenues for understanding the dynamic nature of reward expectations and their impact on cognitive processes.

Abstract:Previous research suggests that neural and behavioral responses to surprised faces are modulated by explicit contexts (e.g., "He just found $500"). Here, we examined the effect of implicit contexts (i.e., valence of other frequently presented faces) on both valence ratings and ability to detect surprised faces (i.e., the infrequent target). In Experiment 1, we demonstrate that participants interpret surprised faces more positively when they are presented within a context of happy faces, as compared to a context of angry faces. In Experiments 2 and 3, we used the oddball paradigm to evaluate the effects of clearly valenced facial expressions (i.e., happy and angry) on default valence interpretations of surprised faces. We offer evidence that the default interpretation of surprise is negative, as participants were faster to detect surprised faces when presented within a happy context (Exp. 2). Finally, we kept the valence of the contexts constant (i.e., surprised faces) and showed that participants were faster to detect happy than angry faces (Exp. 3). Together, these experiments demonstrate the utility of the oddball paradigm to explore the default valence interpretation of presented facial expressions, particularly the ambiguously valenced facial expression of surprise.

Abstract:In this paper, we aimed to demonstrate how incidental surprise impacts individuals' risk-taking behavior. Previous empirical studies have shown that incidental surprise can influence risk-taking behavior, but the psychological mechanisms behind this phenomenon have not been explored. Based on the appraisal tendency framework, we propose that surprise affects individuals' risk-taking behavior by influencing their level of pleasantness and risk perception. To test our hypothesis, we conducted a study with 79 participants, comparing their pleasantness, risk perception, and risk-taking behavior under different emotions. Our findings strongly indicate that pleasantness and risk perception jointly contributed to a chain mediation effect when positive (negative) surprise prompted participants to become more (less) willing to take risks. Additionally, we also discovered that the effect of negative surprise on risk-taking behavior was moderated by individuals' risk attitudes. Risk-seeking individuals were less affected by negative surprise than risk-averse ones. Overall, this study sheds light on the psychological mechanisms underlying the impact of incidental surprise on individuals' risk-taking behavior.

Abstract:The structural credit assignment problem arises when the causal structure between actions and subsequent outcomes is hidden from direct observation. To solve this problem and enable goal-directed behavior, an agent has to infer structure and form a representation thereof. In the scope of this study, we investigate a possible solution in the human brain. We recorded behavioral and electrophysiological data from human participants in a novel variant of the bandit task, where multiple actions lead to multiple outcomes. Crucially, the mapping between actions and outcomes was hidden and not instructed to the participants. Human choice behavior revealed clear hallmarks of credit assignment and learning. Moreover, a computational model which formalizes action selection as the competition between multiple representations of the hidden structure was fit to account for participants data. Starting in a state of uncertainty about the correct representation, the central mechanism of this model is the arbitration of action control towards the representation which minimizes surprise about outcomes. Crucially, single-trial latent-variable analysis reveals that the neural patterns clearly support central quantitative predictions of this surprise minimization model. The results suggest that neural activity is not only related to reinforcement learning under correct as well as incorrect task representations but also reflects central mechanisms of credit assignment and behavioral arbitration. In naturalistic environments, causal relationships between actions and their consequences are often hidden from direct observation. To overcome this structural credit-assignment problem, agents have to infer causal structures from experience. Here, we developed a computational model which formalizes action selection as the competition between structural representations, while action control is arbitrated towards the representation that minimizes surprise over time. To validate this model, we recorded behavioral and electrophysiological data from human participants in a novel task in which independent decisions are followed by outcomes, whereby the decision-outcome mapping is unknown. The model could account for patterns of choice behavior revealing clear hallmarks of credit assignment. Model-based analysis of EEG activity confirmed central model characteristics of concurrent prediction errors and a signature of evidence accumulation and behavioral arbitration. These findings highlight a key role of surprise minimization for both value and representation learning and reveal neural correlates of credit assignment.

Abstract:The frontal eye field (FEF) plays a well-established role in the control of visual attention. The strength of an FEF neuron's response to a visual stimulus presented in its receptive field is enhanced if the stimulus captures spatial attention by virtue of its salience. A stimulus can be rendered salient by cognitive factors as well as by physical attributes. These include surprise. The aim of the present experiment was to determine whether surprise-induced salience would result in enhanced visual-response strength in the FEF. Toward this end, we monitored neuronal activity in two male monkeys while presenting first a visual cue predicting with high probability that the reward delivered at the end of the trial would be good or bad (large or small) and then a visual cue announcing the size of the impending reward with certainty. The second cue usually confirmed but occasionally violated the expectation set up by the first cue. Neurons responded more strongly to the second cue when it violated than when it confirmed expectation. The increase in the firing rate was accompanied by a decrease in spike-count correlation as expected from capture of attention. Although both good surprise and bad surprise induced enhanced firing, the effects appeared to arise from distinct mechanisms as indicated by the fact that the bad-surprise signal appeared at a longer latency than the good-surprise signal and by the fact that the strength of the two signals varied independently across neurons.

Measuring Visual Surprise Jointly from Intrinsic and Extrinsic Contexts for Image Saliency Estimation

Abstract:Detecting conspicuous image content is a challenging task in the field of computer vision. In existing studies, most approaches focus on estimating saliency only with the cues from the input image. However, such “intrinsic” cues are often insufficient to distinguish targets and distractors that may share some common visual attributes. To address this problem, we present an approach to estimate image saliency by measuring the joint visual surprise from intrinsic and extrinsic contexts. In this approach, a hierarchical context model is first built on a database of 31.2 million images, where a Gaussian mixture model (GMM) is trained for each leaf node to encode the prior knowledge on “what is where” in a specific scene. For a testing image that shares similar spatial layout within a scene, the pre-trained GMM can serve as an extrinsic context model to measure the “surprise” of an image patch. Since human attention may quickly shift between different surprising locations, we adopt a Markov chain to model a surprise-driven attention-shifting process so as to infer the salient patches that can best capture human attention. Experiments show that our approach outperforms 19 state-of-the-art methods in fixation prediction.
From IT Leveraging Competence to Competitive Advantage in Turbulent Environments: The Case of New Product Development

Abstract:A burning question for information systems (IS) researchers and practitioners is whether and how IT can build a competitive advantage in turbulent environments. To address this question, this study focuses on the business process level of analysis and introduces the construct of IT leveraging competence---the ability to effectively use IT functionalities. This construct is conceptualized in the context of new product development (NPD). IT leveraging competence is shown to indirectly influence competitive advantage in NPD through two key mediating links: functional competencies (the ability to effectively execute operational NPD processes) and dynamic capabilities (the ability to reconfigure functional competencies to address turbulent environments). Environmental turbulence is also shown to moderate the process by which IT leveraging competence influences competitive advantage in NPD. Empirical data were collected from 180 NPD managers. Through the construct of IT leveraging competence, the study shows that the effective use of IT functionalities, even generic functionalities, by business units can help build a competitive advantage. The study also shows that the strategic effect of IT leveraging competence is more pronounced in higher levels of environmental turbulence. This effect is not direct: It is fully mediated by both dynamic capabilities and functional competencies. Taken together, these findings suggest that IS researchers should look beyond the direct effects of firm-level IT infrastructures and focus their attention on how business units can leverage IT functionalities to better reconfigure and execute business processes. In turbulent environments, focusing on these aspects is even more vital.
Encoding surprise by retinal ganglion cells

Abstract:The efficient coding hypothesis posits that early sensory neurons transmit maximal information about sensory stimuli, given internal constraints. A central prediction of this theory is that neurons should preferentially encode stimuli that are most surprising. Previous studies suggest this may be the case in early visual areas, where many neurons respond strongly to rare or surprising stimuli. For example, previous research showed that when presented with a rhythmic sequence of full-field flashes, many retinal ganglion cells (RGCs) respond strongly at the instance the flash sequence stops, and when another flash would be expected. This phenomenon is called the `omitted stimulus response'. However, it is not known whether the responses of these cells varies in a graded way depending on the level of stimulus surprise. To investigate this, we presented retinal neurons with extended sequences of stochastic flashes. With this stimulus, the surprise associated with a particular flash/silence, could be quantified analytically, and varied in a graded manner depending on the previous sequences of flashes and silences. Interestingly, we found that RGC responses could be well explained by a simple normative model, which described how they optimally combined their prior expectations and recent stimulus history, so as to encode surprise. Further, much of the diversity in RGC responses could be explained by the model, due to the different prior expectations that different neurons had about the stimulus statistics. These results suggest that even as early as the retina many cells encode surprise, relative to their own, internally generated expectations.
Bayesian semantic surprise based on different types of regularities predicts the N400 and P600 brain signals

Abstract:The brain’s remarkable ability to extract patterns from sequences of events has been demonstrated across cognitive domains and is a central assumption of predictive processing theories. While predictions shape language processing at the level of meaning, little is known about the underlying learning mechanism. Here, we investigated how continuous statistical inference in a semantic sequence influences the neural response. 60 participants were presented with a semantic oddball-like roving paradigm, consisting of sequences of nouns from different semantic categories. Unknown to the participants, the overall sequence contained an additional manipulation of transition probability between categories. Two Bayesian sequential learner models that captured different aspects of probabilistic learning were used to derive theoretical surprise levels for each trial and investigate online probabilistic semantic learning. The N400 ERP component was primarily modulated by increased probability with repeated exposure to the categories throughout the experiment, which essentially represents repetition suppression. This N400 repetition suppression likely prevented sizeable influences of more complex predictions such as those based on transition probability, as any incoming information was already continuously active in semantic memory. In contrast, the P600 was associated with semantic surprise in a transition probability model over recent observations, possibly indicating a working memory update in response to violations of these conditional dependencies. The results support probabilistic predictive processing of semantic information and demonstrate that continuous update of distinct statistics differentially influences language related ERPs.

Abstract:We formulate a procedure to investigate the sensitivity of surface reflectances retrieved from satellite sensor data to uncertainties in aerosol optical properties. Aerosol optical characteristics encompassed in the study include the aerosol optical depth, the Junge parameter (i.e., spectral dependence), and the imaginary part of the refractive index (i.e., aerosol absorption). The study includes both clear and hazy atmospheric conditions, wavelengths of 0.550 and 0.870 µm, three solar zenith angles, and five viewing geometries. Key results are presented graphically in terms of accuracy requirements on the aerosol property under consideration for a 5% uncertainty in predicted surface reflectance.
