Abstract:An iterative learning model predictive control (ILMPC) technique is applied to a class of continuous/batch processes. Such processes are characterized by the operations of batch processes generating periodic strong disturbances to the continuous processes and traditional regulatory controllers are unable to eliminate these periodic disturbances. ILMPC integrates the feature of iterative learning control (ILC) handling repetitive signal and the flexibility of model predictive control (MPC). By on-line monitoring the operation status of batch processes, an event-driven iterative learning algorithm for batch repetitive disturbances is initiated and the soft constraints are adjusted timely as the feasible region is away from the desired operating zone. The results of an industrial application show that the proposed ILMPC method is effective for a class of continuous/batch processes.
An Efficient Iterative Learning Predictive Functional Control for Nonlinear Batch Processes

Abstract:Iterative learning model-predictive control (ILMPC) is very popular in controlling the batch process since it possesses not only the learning ability along batches but also the strong time-domain tracking properties. However, for a fast batch process with strong nonlinear dynamics, the application of the ILMPC is challenging due to the difficulty in balancing the computational efficiency and tracking accuracy. In this article, an efficient iterative learning predictive functional control (ILPFC) is proposed. The original nonlinear system is linearized along the reference trajectory to derive a 2-D tracking-error predictive model. The linearization error is compensated by utilizing the Lipschitz condition so that the objective function can be formulated with the upper bound of the actual tracking error. For enhancing control efficiency, predictive functional control (PFC) is applied in the time domain, which reduces the dimension of the decision variable in order to effectively cut down the computational burden. The stability and convergence of this ILPFC with terminal constraint are analyzed theoretically. Simulations on an unmanned ground vehicle and a typical fast batch reactor verify the effectiveness of the proposed control algorithm.

Abstract:Iterative learning model predictive control (ILMPC), endowed with the merits of iterative learning control and model predictive control, has excellent abilities of disturbance rejection and constraints handling. It has been widely applied in regulation of industrial batch processes for its remarkable reference tracking performance. In practice, the presence of strong system nonlinearity fundamentally challenges the model mismatch cyclewise invariance assumption that underlies numerous synthesis of many ILMPC methods. It may further induce additional conservatism and thus ultimately leads to performance degradation. To circumvent this issue, in this paper a novel ILMPC scheme relying upon past error compensation from multiple time instances is presented, in which the associated weights are adaptively optimized, thereby resulting in considerable enhancement of robustness. These superior performances are confirmed by numerical experiments on injection molding process, a typical batch process.
Event-Based Switching Iterative Learning Model Predictive Control for Batch Processes With Randomly Varying Trial Lengths

Abstract:Iterative learning model predictive control (ILMPC) has been recognized as an excellent batch process control strategy for progressively improving tracking performance along trials. However, as a typical learning-based control method, ILMPC generally requires the strict identity of trial lengths to implement 2-D receding horizon optimization. The randomly varying trial lengths extensively existing in practice can result in the insufficiency of learning prior information, and even the suspension of control update. Regarding this issue, this article embeds a novel prediction-based modification mechanism into ILMPC, to adjust the process data of each trial into the same length by compensating the data of absent running periods with the predictive sequences at the end point. Under this modification scheme, it is proved that the convergence of the classical ILMPC is guaranteed by an inequality condition relative with the probability distribution of trial lengths. Considering the practical batch process with complex nonlinearity, a 2-D neural-network predictive model with parameter adaptability along trials is established to generate highly matched compensation data for the prediction-based modification. To best utilize the real process information of multiple past trials while guaranteeing the learning priority of the latest trials, an event-based switching learning structure is proposed in ILMPC to determine different learning orders according to the probability event with respect to the trial length variation direction. The convergence of the nonlinear event-based switching ILMPC system is analyzed theoretically under two situations divided by the switching condition. The simulations on a numerical example and the injection molding process verify the superiority of the proposed control methods.

Abstract:In industrial applications, many processes are constructed by two or more sub-processes connected in serial to perform a given task repetitively or periodically, termed as the cascaded batch/repetitive processes. In this paper, an integrated design method of a novel cascade control is developed for this kind of processes under the two-dimensional (2D) model predictive iterative learning control (ILC) infrastructure. The resulted control system essentially consists of a real time cascade model predictive control along time direction as the inner-loop control and an iterative learning control along the cycle direction as the outer-loop control. The proposed design algorithm not only realizes the integrated design for all control loops but also guarantees the optimal control in terms of the 2D control performances. Compared to the non-cascade ILC schemes, the proposed algorithm is essentially a 2D cascaded control with superior control performances that are clearly illustrated by the simulation results on the injection molding processes.

Abstract:Iterative learning model predictive control (ILMPC) has been considered as potential control strategy for batch processes. ILMPC can converge to the desired reference trajectory with high precision along batches and ensure system stability within batches. However, as a model-based control method, the control performance of the ILMPC algorithm deteriorates when exists model parameter uncertainty. Therefore, guaranteeing system tracking performance in the case of model parameter uncertainty is a challenging task in the framework designing of ILMPC method. To this end, we develop a two-stage robust ILMPC strategy for batch processes, which integrates the robust iterative learning control (ILC) in the domain of batch-axis and robust model predictive control (MPC) in the domain of time-axis into one comprehensive control scheme. The integrated control law of the developed two-stage robust ILMPC algorithm is obtained by solving two convex optimization problems. As a result, the developed control method obtains faster convergence speed and better tracking performance in the case of model parameter uncertainty. Moreover, the convergence analysis of the system is presented. Finally, comparative simulations are provided to verify the superiority of the developed control algorithm.

Abstract:Optimization-based iterative learning control (OILC) has been widely applied to batch processes due to its fast convergence, good control performance and ability to handle constraints. However, how to guarantee constraint satisfaction and convergence of tracking error in the presence of unknown system nonlinearity remains open in the framework of OILC. It is important to address this issue since unknown nonlinearity is common in practice and detrimental to good control performance. In this paper, we propose a tube feedback OILC to investigate the applicability of linear-model based control strategy on batch processes with an unknown nonlinear term. First, a state feedback control law is designed to stabilize the system. The stabilized system is then decomposed into two subsystems: repeatable and unrepeatable subsystems; Second, an invariant set of states corresponding to the unrepeatable subsystem is computed, based on which an OILC is further developed for the repeatable subsystem to improve the control performance. Meanwhile, the feedback controller steers the states within a tube around the trajectory of OILC. In this way, convergence and constraint satisfaction are ensured simultaneously. Compared with the currently existing methods, the proposed method has the following advantages: (1) generality covering both stable and unstable systems; (2) low computation complexity; and (3) rigorous stability. The simulation results on injection molding velocity control demonstrate that the proposed method has superior performance.

Abstract:Batch processes are typically nonlinear systems with constraints. Model predictive control (MPC) and iterative learning control (ILC) are effective methods for controlling batch processes. By combining batch-wise ILC and time-wise MPC, this article proposes a multirate control scheme for constrained nonlinear systems. Two-dimensional (2-D) framework is used to combine historical batch data with current measurements. The ILC part uses run-to-run control with previous iteration data, and the MPC part uses real-time control with current sampled measurements. Real-time feedback-based MPC in the time axis and run-to-run ILC in the batch axis are combined to optimize the current inputs based on previous batch input–output data and real-time system measurements. Rather than achieving control objectives in a single batch, our design allows multiple batches to be executed successively. To establish the stability of the combined scheme, rigorous theoretical analysis is presented next. The combined scheme with improved performance is then validated through two illustrative numerical examples.

Abstract:Iterative learning control (ILC) has been successfully applied to numerous batch processes over the past decades. Monotonic convergence of tracking error is a desired characteristic that attracts much attention in academia. Many factors arising in industrial practice, such as strong nonlinearity and parameter uncertainty, have challenged the most existing monotonically convergent ILC approaches. This motivates the development of the nonlinear monotonically convergent ILC (NMC-ILC) in this paper. The proposed NMC-ILC is an optimization-based control strategy, in which the original nonlinear process is linearly approximated to reduce the complexity of the optimization problem accompanied. An upper bound of the tracking error is derived by considering the effects of model mismatches that consist of two components: structural mismatch induced by the linearization and parametric mismatch arising from the indetermination of process parameters. The NMC-ILC is then devised by minimizing this upper bound. Numerical experiments are conducted on an ILC-testing benchmark and the velocity control in an injection molding process.

Abstract:Multi-phase batch process is common in industry, such as injection molding process, fermentation and sequencing batch reactor; however, it is still an open problem to control and analyze this kind of processes. Motivated by injection molding processes, the multi-phase batch process in each cycle is formulated as a switched system with internally forced switching instant. Controlling multi-phase batch processes can be decomposed into two subtasks: detecting the dynamics-switching-time; designing the control law for each phase with considering switching effect. In this paper, it is assumed that the dynamics-switching-time can be obtained in real-time and only the second subtask is studied. To exploit the repetitive nature of batch processes, iterative learning control scheme is used in batch direction. To deal with constraints, updating law is designed by using model predictive control scheme. An online iterative learning model predictive control (ILMPC) law is first proposed with a quadratic programming problem to be solved online. To reduce computation burden, an offline ILMPC is also proposed and compared. Applications on injection molding processes show that the proposed algorithms can control multi-phase batch processes well.

Abstract:This paper proposes a latent variable nonlinear iterative learning model predictive control method (LV-NILMPC) based on the dynamic fuzzy partial least squares (DFPLS) model to achieve trajectory tracking and process disturbance suppression in multivariable nonlinear batch processes. The dynamic and nonlinear characteristics of the physical system are constructed by integrating the T-S fuzzy model into the regression framework of the dynamic partial least squares (PLS) inner model. The decoupling and dimensionality reduction characteristics of the DFPLS model automatically decompose a multivariable nonlinear system into multiple univariate subsystems operating independently in the latent variable space. Based on the DFPLS model, we design LV-NILMPC controllers corresponding to each latent variable subspace to track the projection of the reference trajectories. Compared with the previous control method, the method proposed in this paper has a faster convergence rate and smaller tracking error. The method is suitable for nonlinear, multivariable and strong coupling batch processes. Finally, the application of two cases shows that the method is effective.

Abstract:In this paper, an integrated tube robust iterative learning model predictive control (Tube‐RILMPC) strategy based on the dynamic partial least squares (DyPLS) identified algorithm is proposed. The problems of large amount of online data calculation and input and output variable dimensions disaster in the original variable space are solved. This integrated Tube‐RILMPC strategy enhances the tracking performance and robustness of two‐dimensional (2D) control system. The output trajectories of system are located in the tube the nominal trajectory, which reduces the modelling error caused by the uncertain model. Based on the worst‐case performance index of ellipsoidal uncertainty and polytopic uncertainty, a robust iterative learning control (ILC) strategy is designed. Finally, the superiority of the proposed control algorithm is verified by comparative simulation.

Abstract:In order to improve the convergence speed of iterative learning control (ILC),an integrated scheme for tracking problem of batch process is proposed by combining batch-to-batch P-type ILC and within-batch model predictive control (MPC).Based on a predefined batch-wise linear model of the process,the output of traditional P-type ILC can be predicted,and then MPC is induced to minimize a quadratic objective function within the current batch.The input is updated within the batch so that the output may approach the reference trajectory faster.An illustrative example is presented to demonstrate the performance of the proposed scheme.

Abstract:An integrated predictive iterative learning control (IPILC) scheme for batch process is designed from a two-dimensional (2D) system point of view. The integrated control framework combines batch-wise ILC and time-wise model predictive control (MPC), referred as 2D-IPILC. In the trajectory tracking problem of batch process, the predictive model can be obtained based on the system response using 2D theory. The control profile in the current batch is updated by MPC, using a quadratic objective function defined over time horizon. The major advantages of the proposed design scheme are shown in the better tracking performance as well as faster convergence speed by taking into account the time-wise feedback control with-in the current batch. The simulation results demonstrate the effectiveness of the proposed scheme.

Abstract:An iterative learning control (ILC) approach with input trajectory parameterization is proposed for batch processes. In the new approach, the main characteristics of the optimal input profile are obtained to parameterize the whole input trajectory with a few scholar decision variables. The proposed ILC method maintains the simplicity of the algorithm, while improving the optimizing control performance from batch to batch under uncertainties. A batch reactor is simulated to demonstrate the effectiveness of proposed ILC method.

Abstract:An optimal iterative learning control (ILC) strategy is proposed to track product quality trajectories of batch processes by updating a linear time-varying perturbation (LTVP) model. To address the problem of model parameter variations from batch to batch, the LTVP model is renewed by using strong tracking filter (STF) algorithm. Comparing recursive least squares (RLS), STF can capture the changing dynamics of the process more accurately. The tracking error transition models can be built, and the ILC law with direct error feedback is explicitly obtained. Sufficient conditions of convergence are derived for the optimal ILC based on the LTVP model. It has also been proved that the tracking error will converge to a small constant but depend on the accuracy of the LTVP model error. If there is no model error, the tracking error can converge to zero. By using STF to update the LTVP model, the model accuracy is improved and the tracking control performance is also enhanced. The proposed strategy is illustrated on a typical batch reactor, and the results demonstrate that the performance of tracking product qualities can be improved under the proposed strategy when model parameter variations occur with respect to the batch index.

Abstract:Batch process is an important category of industrial processes. Recently, the combination of the real-time-feedback-based iterative learning control (ILC) and the model predictive controller (MPC) has demonstrated its advantage when applied to the batch process. In practical applications, the plants are always nonlinear and the model cannot be known exactly. Therefore, how to design such a control strategy for the constrained batch processes with unknown input nonlinearities and guarantee the convergence is interesting and valuable. Inspired by the dual mode MPC, this paper proposes a two-mode framework for the constrained ILC MPC to solve this problem, which is constructed by a real-time-feedback-based strategy followed by a run-to-run strategy. Under the proposed framework, an invariant updating strategy based on the run-to-run strategy is developed for constrained batch processes to act as the second mode, which describes the situation of infinite batch and gives an estimation on the upper bound of the influence from the nonlinearity. Then, a real-time-feedback-based ILC MPC with a two-dimensional (2D) model is designed for the considered batch process, which adopts the time-varying horizon, and is proven to be recursively feasible and convergent. The case studies verify the results of the paper.

Abstract:The convergence analysis of two-dimensional based integrated predictive iterative learning control (2D-IPILC) is presented for batch process in presence of output noises. In the 2D-IPILC method, iterative learning control (ILC) in the batch domain is integrated reasonably with real-time model predictive control (MPC) in the time domain. Based on the 2D system theory, system response of output tracking error is described explicitly by using the state-transition matrix of the 2D system for the first time. Then influence of output noise to the tracking error can be revealed clearly. By using this description of model response, convergence properties of the 2D-IPILC can be also analyzed theoretically. The sufficient convergence conditions of output tracking error in the proposed algorithm are derived for a class of linear systems. Simulation results have demonstrated the effectiveness of the proposed method.

Abstract:A neural network based iterative learning control (NN-ILC) strategy is proposed to improve the product qualities in batch processes. Based on the repetitive nature of batch processes, iterative learning control (ILC) is used to improve product qualities gradually from batch to batch. The learning gain in the ILC is usually determined according to a linearised model. Instead of building a model for the system dynamics, a feed-forward neural network (FNN) is used directly as a non-linear learning gain in the ILC law. The tracking error profile of the previous batch is used as the input of the FNN, while the output of the network is the control change profile for the next batch run. It has been proved that if the network is trained properly based on the historical operation data, the tracking error under the proposed NN-ILC can converge to zero gradually with respect to the batch number. The neural network can also be retrained during the ILC to renew the learning gain in order to handle model uncertainties of the batch processes. The proposed control strategy is illustrated on a typical batch reactor.
