Abstract:The remaining useful life (RUL) prediction has received increasing research attention in recent years due to its essential role in improving industrial manufacturing systems' productivity and reliability. High dimensionality time-series data is collected during the system's operating time with the implementation of various sensors. To monitor the machining tool's RUL, a novel multisensor fusion method based on t-SNE-DBSCAN dimensionality reduction is proposed in this paper to aggregate the multiple sensor measurements into a healthy indication that represents the RUL. The robust MCD-Estimator is used to denoise multidimensional sensor data, flag the outliers, and enhance the robustness of the denoising process. The high dimensional statistical features are extracted, and the dimensionality is reduced with t-distributed Stochastic Neighbor Embedding (t-SNE) according to the RUL labels, and optimum features selected by Density-Based Spatial Clustering of Application with Noise algorithm (DBSCAN). Ultimately, Long Short-Term Memory (LSTM) is adopted for RUL estimation with multisensor fusion. A case study with a practical application of the proposed approach, which can be demonstrated, is compared with state-of-the-art methods by evaluating its performance and migration capability in different working conditions.

Remaining Useful Life Prediction of Machining Tools by 1D-CNN LSTM Network.

Abstract:In the field of machining, machining tool life (degree of wear) is a key factor affecting the quality of the machined workpiece. Over-protection strategies may increase production costs and cause unnecessary machining tool downtime. Therefore, if the remaining useful life (RUL) of the machining tool can be accurately predicted, the work schedule will be effectively optimized and the machining tool procurement cost will be reduced. In this paper, we propose a system schema that integrates programmable logic controller (PLC) signals with sensor signals for online RUL prediction of machining tools. The preprocessed sensor signals are segmented and we propose ensemble discrete wavelets transform (EDWT) to eliminate the noise of three-dimensional vibration signals and get time- frequency information. Then statistics features are extracted based on time domain and frequency domain analysis. Further, we use spearman's coefficient, autocorrelation and monotonicity indicators for feature selection to reduce feature dimensions. Finally, we use a 1D-CNN LSTM network architecture for machining tools RUL prediction. The evaluation results show that our system schema is feasible for the industrial field, and has a better performance than other common methods.

Abstract:Accurately predicting the tool remaining useful life (RUL) is critical for maximizing tool utilization and saving machining costs. Various physical model-based or data-driven prediction methods have been developed and successfully applied in different machining operations. However, many uncertain factors affect tool RUL during the cutting process, making it challenging to create a precise physical model to characterize the degradation of tool performance. The success of the purely data-driven technique depends on the amount and quality of the training samples, it does not consider the physical law of tool wear, and the interpretability of the prediction results is poor. This paper presents a data-model linkage approach for tool RUL prediction based on deep feature fusion and Wiener process to address the above limitations. A convolutional stacked bidirectional long short-term memory network with time-space attention mechanism (CSBLSTM-TSAM) is developed in the data-driven module to fuse the multi-sensor signals collected during the cutting process and then obtain the mapping relationship between signal features and tool wear values. In the physical modeling module, a three-stage tool RUL prediction model based on the nonlinear Wiener process is established by considering the evolution law of different wear stages and multi-layer uncertainty, and the corresponding probability density function is derived. The real-time estimated tool wear of the data-driven module is used as the observed value of the physical model, and the model parameters are dynamically updated by the weight-optimized particle filter (WOPF) algorithm under a Bayesian framework, thereby realizing the data-model linkage tool RUL prediction. Milling experiments demonstrate that the proposed method not only improves RUL prediction accuracy, but also has good generalization ability and robustness for prediction tasks under different working conditions.

Abstract:This article proposes a novel deep learning based fusion prognostic method for remaining useful life (RUL) prediction of engineering systems. The proposed framework strategically combines the advantages of bidirectional long short-term memory (BLSTM) networks and particle filter (PF) method and meanwhile mitigates their limitations. In the proposed framework, BLSTM networks are applied for further extracting, selecting, and fusing discriminative features to form predicted measurements of the identified degradation indicator. Simultaneously, PF is utilized to estimate system state and identify unknown parameters of the degradation model for RUL prediction. Hence, the proposed fusion prognostic framework has two innovative features: first, the preprocessed features from raw multisensor data can be intelligently extracted, selected, and fused by the BLSTM networks without specific domain knowledge of feature engineering; second, the predicted measurements with uncertainties obtained from the BLSTM networks will be properly represented by the PF in a transparent manner. Moreover, the developed approach is experimentally validated with machining tool wear tests on a computer numerical control (CNC) milling machine. In addition, the popular techniques employed in this field are also investigated to compare with the proposed method.

Abstract:To enhance production quality, productivity and energy consumption, it is paramount to predict the remaining useful life (RUL) of a cutting tool accurately and efficiently. Deep learning algorithm-driven approaches have been actively explored in the research field though there are still potential areas to further enhance the performance of the approaches. In this research, to improve accuracy and expedite computational efficiency for predicting the RUL of cutting tools, a novel systematic methodology is designed to integrate strategies of signal partition and deep learning for effectively processing and analysing multi-sourced sensor signals collected throughout the lifecycle of a cutting tool. In more detail, the methodology consists of two sub-systems: (i) a Hurst exponent–based method is developed to effectively partition complex and multi-sourced signals along the tool wear evolution, and (ii) a hybrid CNN-LSTM algorithm is designed to combine feature extraction, fusion and regression in a systematic means to facilitate the prediction based on segmented signals. The system was validated using a case study with a large set of databases with multiple cutting tools and multi-sourced signals. Comprehensive comparisons between the proposed methodology and some other mainstream algorithms, such as CNN, LSTM, DNN and PCA, were carried out under the conditions of partitioned and unpartitioned signals. Benchmarks showed that, based on the case study in this research, the prediction accuracy of the proposed methodology reached 87.3%, which is significantly better than those of the comparative algorithms.

Abstract:An effective and reliable prediction of the remaining useful life (RUL) of a tool is important to a metal forming process because it can significantly reduce unexpected maintenance, avoid machine shutdowns and increase system stability. This study proposes a new data-driven approach to the RUL prediction for metal forming processes under multiple contact sliding conditions. The data-driven approach took advantage of bidirectional long short-term memory (BLSTM) and convolutional neural networks (CNN). A pre-trained lightweight CNN-based network, WearNet, was re-trained to classify the wear states of workpiece surfaces with a high accuracy, then the classification results were passed into a BLSTM-based regression model as inputs for RUL estimation. The experimental results demonstrated that this approach was able to predict the RUL values with a small error (below 5%) and a low root mean square error (RMSE) (around 1.5), which was more superior and robust than the other state-of-the-art methods.

Machine Tool Wear Prediction Technology Based on Multi-Sensor Information Fusion

Abstract:The intelligent monitoring of cutting tools used in the manufacturing industry is steadily becoming more convenient. To accurately predict the state of tools and tool breakages, this study proposes a tool wear prediction technique based on multi-sensor information fusion. First, the vibrational, current, and cutting force signals transmitted during the machining process were collected, and the features were extracted. Next, the Kalman filtering algorithm was used for feature fusion, and a predictive model for tool wear was constructed by combining the ResNet and long short-term memory (LSTM) models (called ResNet-LSTM). Experimental data for thin-walled parts obtained under various machining conditions were utilized to monitor the changes in tool conditions. A comparison between the ResNet and LSTM tool wear prediction models indicated that the proposed ResNet-LSTM model significantly improved the prediction accuracy compared to the individual LSTM and ResNet models. Moreover, ResNet-LSTM exhibited adaptive noise reduction capabilities at the front end of the network for signal feature extraction, thereby enhancing the signal feature extraction capability. The ResNet-LSTM model yielded an average prediction error of 0.0085 mm and a tool wear prediction accuracy of 98.25%. These results validate the feasibility of the tool wear prediction method proposed in this study.

Abstract:Accurate prediction of remaining useful life (RUL) serves as the foundation for predictive maintenance of industrial equipment. In recent years, the fusion of multisource information has achieved remarkable advancements in the development and application of RUL prediction. However, under time-varying operating conditions, the distribution of monitoring data exhibits time-varying characteristics, posing two challenges for RUL prediction in this scenario. One is the adaptive decoupling of operating condition data and monitoring data, and the other is an adaptive weighting of multisource information. To address these challenges, a novel method for RUL prediction is proposed in this article driven by the fusion of multisource information under time-varying operating conditions. The proposed approach is designed to track the degradation process of equipment in scenarios involving cyclic variation and multiple levels in operating conditions. An optimization function is constructed to comprehensively characterize the frequency domain distribution of current signals and the continuity of the health index over time. Then, a time-varying observation matrix for the degradation state space model is derived, which aims to eliminate the influence of operating condition data on degradation information. Two Kalman filter models are developed based on the linear degradation model and double exponential degradation model focused on different stages of equipment degradation, which can calculate time-varying weights for vibration and sound information at different time coordinates. In this way, a multidimensional data mapping from multisource information to the degradation curve is established under time-varying operating conditions. In order to verify the superiority of the proposed method in RUL prediction, two sets of run-to-failure experimental datasets are studied and analyzed. The result demonstrates that the proposed method achieves superior performance compared with single-source information methods.

Abstract:With the rapid development of Industrial Internet of Things, more and more sensors have been used for condition monitoring and prognostics of industrial systems. Big data collected from sensor networks bring abundant information resources as well as technical challenges for remaining useful life (RUL) prediction. The major technical challenges include how to select informative sensors and fuse multi-sensor data to improve the prediction performance. To deal with the challenges, this paper proposes a RUL prediction method based on a multi-sensor data fusion model. In this method, the inherent degradation process of the system state is expressed using a state transition function following a Wiener process. Multi-sensor signals are explicated as various proxies of the inherent system degradation process using a multivariate measurement function. The system state is estimated by fusing multi-sensor signals using particle filtering. Informative sensors are selected by a prioritized sensor group selection algorithm. This algorithm first prioritizes sensors according to their individual performances in RUL prediction, and then selects an optimal sensor group based on their combined performances. The effectiveness of the proposed method is demonstrated using a simulation study and aircraft engine degradation data from NASA repository.

Abstract:<p>Wear, fracture, and other tool faults affect the quality of a machined workpiece and can even damage machine tools. The accurate prediction of remaining useful life (RUL) can prevent a tool from suddenly failing, an ability of significance for ensuring machining quality and providing effective predictive maintenance strategies. Most current approaches for predicting tool RUL are based on historical failure and truncation data. However, for new types of tools or when a similar tool has just launched, such failure and truncation data are limited or even unavailable, making RUL prediction a challenge when using previously proposed methods. To address this problem, a novel method for the prediction of tool RUL using limited data is proposed in this study. A time window is constructed to track the tool condition using sensor data, and its size can be dynamically adjusted according to the wear factor and increase rate. Then, a deep bidirectional long short-term memory (DBiLSTM) neural network in which sequential data are predicted and smoothed by forwards and backwards directions, respectively, is developed to encode temporal information and identify long-term dependencies. On this basis, multi-step ahead rolling predictions are then employed to predict tool RUL. Finally, the effectiveness of the proposed method is verified using the results of milling experiments. These results show that the proposed method is able to predict tool RUL with high accuracy using only limited data.</p>

Abstract:Proceedings of the Institution of Mechanical Engineers, Part B: Journal of Engineering Manufacture, Ahead of Print. To optimise the utilisation cost of cutting tools, it is imperative to develop an online system to efficiently and accurately predict tool wear conditions and remaining useful lives (RULs). With this aim, a novel system is proposed based on deep learning algorithms distributed over an edge-cloud computing architecture. The system is innovative in the following aspects: (i) a lightweight convolutional neural network-random forest (CNN-RF) model is designed to be executed on an edge device to assess tool wear conditions efficiently, which supports severe tool resilience and tool replacement when necessary; (ii) a convolutional neural network-long short-term memory (CNN-LSTM) model is designed to be executed on a cloud to process long-term signals to predict the RUL of the cutting tool, which supports fine-tuning tool parameters dynamically; (iii) a signal compression mechanism is developed to condense the signals of tooling conditions into 2D images so the signal volumes transferred over the network are minimised and signal security is improved. Experiments were performed in a real-world machining workshop for research methodology validation. It showed that the prediction accuracies for tool wear and RUL achieved 90.6% and 93.2%, respectively, and the volume of signals transferred over the network was reduced by 89.0%. The experiments and benchmarks with comparative algorithms demonstrated that the system and its methodology exhibited great potential to reinforce cutting tool optimisation for real-world applications.

Abstract:Remaining useful life (RUL) of cutting tools is concerned with cutting tool operational status prediction and damage prognosis. Most RUL prediction methods utilized different features collected from different sensors to predict the life of the tool. To increase the prediction accuracy, it is often necessary to mount a great deal of sensors on the machine in order to collect more types of signals, which can heavily increase the cost in industrial applications. To deal with this issue, this study, for the first time, proposed a new feature network dictionary, which can enlarge the number of candidate features under limited sensor conditions, and the developed dictionary can potentially contain as much useful information as possible. This process can replace the installation of more sensors and incorporate more information. Then, the sparse augmented Lagrangian (SAL) feature selection method is proposed to reduce the number of candidate features and select the most significant features. Finally, the selected features are input to the Gaussian Process Regression (GPR) model for the RUL estimation. Extensive experiments demonstrate that our proposed RUL estimation framework output performs traditional methods, especially for the cost savings for on-line RUL estimation.

Abstract:Remaining useful life (RUL) prediction, as the cornerstone of prognostics and health management, transforms machine maintenance from a passive to a predictive workflow. With the growing availability of sensor types and installations, monitoring data are becoming progressively multimodal, providing comprehensive perspectives on machine health status. In this paper, we propose a dynamic parameterized bilinear factorized framework to tackle some challenges encountered in exploiting multimodal data. To overcome blending and interference among different modalities, a parallel strategy equipped with distillation blocks is adopted to independently process each modality, extracting specialized sensitive features. Subsequently, high-dimensional features are explicitly fused by a bilinear factorized attention module based on their degree of contained degradation-related information. Notably, we design and validate a new loss function called RUL loss, tailored for industrial requirements, considering the asymmetric risk of different prediction errors. Additionally, a dynamic structure distinct from the regular network paradigm is developed, allowing weight parameters to adapt quickly to data variations rather than being fixed during the reasoning process. The superiority of the proposed method is demonstrated using gear life-cycle experimental data. Experimental results show the effectiveness of each component and the overall framework for RUL prediction, showcasing improvements in accuracy and robustness.

Abstract:Predicting the remaining useful life (RUL) of rolling bearings is a critical technology for ensuring safe operation and reducing the maintenance costs of rotating mechanical equipment. The accuracy of RUL prediction is highly dependent on the quality of degradation features screened from the original statistical features. However, there is redundancy between degradation features after screening, and the screening rule is highly subjective. In addition, some useful information of the unselected features is lost. To solve the above problems, this article proposes a feature fusion-based method for bearing RUL prediction. First, the self-organizing map (SOM) method is used to cluster the statistical features, which are then subjected to dimensionality reduction by the principal component analysis (PCA) method to obtain a fusion degradation feature set. Second, a bidirectional long short-term memory (BiLSTM) network combined with the self-attention (SA) mechanism (BiLSTM-SA model) is established to predict bearing RUL with the fusion feature set. The SA mechanism is introduced to assign different weights to different fusion features to adaptively obtain the optimal feature combination. Finally, the effectiveness of the proposed feature fusion-based prediction method is verified on the Franche-Comté Electronics Mechanics Thermal Science and Optics (FEMTO) bearing dataset and the Intelligent Maintenance Systems (IMS) bearing dataset. The experimental results show that the proposed method can accurately predict bearing RUL, and its performance is superior to that of some state-of-the-art methods.

Abstract:In the modern manufacturing industry, remaining useful life (RUL) prediction of the machining tools plays a significant role in promoting machining efficiency, ensuring product quality and reducing production costs. In recent years, many data-driven prognostic approaches have been developed for machining tools, but few of them have considered the operating conditions such as spindle load and rotating speed that may have great impact on the degradation behavior and sensor signals. It may give rise to more uncertainty and lead to an obvious decrease in prediction accuracy when operating condition changes. Besides, feature extraction from the raw signals that are nonstationary, nonlinear, and mixed with abundant noise is essential but quite challenging. To address these issues, this paper proposes a novel prognostic approach for machining tools under dynamic operating condition with varying spindle load. In the proposed approach, an adaptive variational mode decomposition (VMD) is newly developed to adaptively search the optimal parameters for processing the raw vibration data, then several components with good trendability and noise robustness are obtained for feature extraction. Furthermore, a deep learning model combining one-dimensional convolutional long short-term memory (LSTM) with attention mechanism is constructed to perform RUL prediction. Numerical experiments on a real-world case study show the effectiveness and superiority of the proposed approach in comparison with other baseline data-driven approaches.

Abstract:In fields such as manufacturing and aerospace, remaining useful life (RUL) prediction estimates the failure time of high-value assets like industrial equipment and aircraft engines by analyzing time series data collected from various sensors, enabling more effective predictive maintenance. However, significant temporal diversity and operational complexity during equipment operation make it difficult for traditional single-scale, single-dimensional feature extraction methods to effectively capture complex temporal dependencies and multi-dimensional feature interactions. To address this issue, we propose a Dual-Path Interaction Network, integrating the Multiscale Temporal-Feature Convolution Fusion Module (MTF-CFM) and the Dynamic Weight Adaptation Module (DWAM). This approach adaptively extracts information across different temporal and feature scales, enabling effective interaction of multi-dimensional information. Using the Commercial Modular Aero-Propulsion System Simulation (C-MAPSS) dataset for comprehensive performance evaluation, our method achieved RMSE values of 0.0969, 0.1316, 0.086, and 0.1148; MAPE values of 9.72%, 14.51%, 8.04%, and 11.27%; and Score results of 59.93, 209.39, 67.56, and 215.35 across four different data categories. Furthermore, the MTF-CFM module demonstrated an average improvement of 7.12%, 10.62%, and 7.21% in RMSE, MAPE, and Score across multiple baseline models. These results validate the effectiveness and potential of the proposed model in improving the accuracy and robustness of RUL prediction.

Abstract:The milling machine serves an important role in manufacturing because of its versatility in machining. The cutting tool is a critical component of machining because it is responsible for machining accuracy and surface finishing, impacting industrial productivity. Monitoring the cutting tool's life is essential to avoid machining downtime caused due to tool wear. To prevent the unplanned downtime of the machine and to utilize the maximum life of the cutting tool, the accurate prediction of the remaining useful life (RUL) cutting tool is essential. Different artificial intelligence (AI) techniques estimate the RUL of cutting tools in milling operations with improved prediction accuracy. The IEEE NUAA Ideahouse dataset has been used in this paper for the RUL estimation of the milling cutter. The accuracy of the prediction is based on the quality of feature engineering performed on the unprocessed data. Feature extraction is a crucial phase in RUL prediction. In this work, the authors considers the time–frequency domain (TFD) features such as short-time Fourier-transform (STFT) and different wavelet transforms (WT) along with deep learning (DL) models such as long short-term memory (LSTM), different variants of LSTN, convolutional neural network (CNN), and hybrid models that are a combination of CCN with LSTM variants for RUL estimation. The TFD feature extraction with LSTM variants and hybrid models performs well for the milling cutting tool RUL estimation.

A multi-source information fusion method for tool life prediction based on CNN-SVM

Abstract:For milling tool life prediction and health management, accurate extraction and dimensionality reduction of its tool wear features are the key to reduce prediction errors. In this paper, we adopt multi-source information fusion technology to extract and fuse the features of cutting vibration signal, cutting force signal and acoustic emission signal in time domain, frequency domain and time-frequency domain, and downscale the sample features by Pearson correlation coefficient to construct a sample data set; then we propose a tool life prediction model based on CNN-SVM optimized by genetic algorithm (GA), which uses CNN convolutional neural network as the feature learner and SVM support vector machine as the trainer for regression prediction. The results show that the improved model in this paper can effectively predict the tool life with better generalization ability, faster network fitting, and 99.85% prediction accuracy. And compared with the BP model, CNN model, SVM model and CNN-SVM model, the performance of the coefficient of determination R2 metric improved by 4.88%, 2.96%, 2.53% and 1.34%, respectively.

Abstract:During machining processes, accurate prediction of cutting tool wear is prominent to prevent ineffective tool utilisation and significant resource waste. Tool wear conditions and progression involve complex physical mechanisms, and a promising approach is to deploy heterogeneous sensors and design a deep learning algorithm to conduct real-time tool wear monitoring and precious prediction. To tackle the challenge of deep learning algorithms in processing complex signals from heterogeneous sensors, in this paper, a systematic methodology is designed to combine signal de-noising, feature extraction, feature optimisation and deep learning-based prediction. In more details, the methodology is comprised of the following three steps: (i) signal de-noising is carried out by a designed Hampel filter-based method to eradicate random spikes and outliers in the signals for raw data quality enhancement; (ii) features extracted from heterogeneous sensors in the time and frequency domains are optimised using designed recursive feature elimination and cross-validation (RFECV)-based and Isomap-based methods; (iii) a convolutional neural networks (CNN) algorithm is devised to process the optimised features to implement tool wear prediction. In this paper, a case study showed that 80% features were reduced from the originally extracted features and 86% prediction accuracy was achieved based on the developed methodology. The presented methodology was benchmarked with several main-stream methodologies, and the superior performance of the methodology over those comparative methodologies in terms of prediction accuracy was exhibited.

Abstract:The tool is a component that is easily damaged and wasted in the CNC machining process. Accurate prediction of tool wear is conducive to reducing processing costs and improving processing efficiency. Most of the current research uses deep learning models to mine the degradation characteristics of tool wear. However, a single deep learning model and a simple sequential combination model can only learn some features, resulting in insufficient features extracted by the model, which seriously affects the accuracy of tool wear prediction. To solve the above problems, a tool wear prediction method based on parallel dual-channel adaptive features fusion is proposed. Firstly, the force, vibration, and acoustic emission signals collected by multi-sensors are preprocessed. Based on CNN-GRU and ConvGRU, a new dual-channel parallel structure is established to extract features from the input multi-sensor signal data. Secondly, the attention mechanism is used to fuse the features extracted from the parallel structure, and different weights are adaptively assigned to the tool wear features, thereby suppressing the influence of irrelevant or redundant features. Finally, the tool wear prediction values are output through the linear layer. The experimental results based on the PHM2010 data set show that the mean absolute error ( MAE ), root mean square error ( RMSE ), and coefficient of determination (R 2 ) of the proposed method are 4.24, 6.41, and 0.966, respectively. The prediction performance of the model is better than other deep learning methods, which can accurately predict the wear state of the tool, provide information support for tool change decisions, and improve production efficiency.
