Abstract:Due to the rapid development of satellite technology, high-spatial-resolution remote sensing (HRRS) images have highly complex spatial distributions and multiscale features, making the classification of such images a challenging task. The key to scene classification is to accurately understand the main semantic information contained in images. Convolutional neural networks (CNNs) have outstanding advantages in this field. Deep CNNs (D-CNNs) with better performance tend to have more parameters and higher complexity. However, shallow CNNs have difficulty extracting the key features of complex remote sensing images. In this paper, we propose a lightweight network with a random depth strategy for remote sensing scene classification (LRSCM). We construct a convolutional feature extraction module, DCAB, which incorporates depthwise separable convolutional and inverted residual structures, effectively reducing the numbers of required parameters and computations, and retains and utilizes low-level features. In addition, coordinate attention (CA) is integrated into the module, thereby further improving the network's ability to extract key local information. To further reduce the complexity of model training, the residual module adopts a stochastic depth strategy, providing the network with a random depth. Comparative experiments on five public datasets show that the LRSCM network can achieve results comparable to those of other state-of-the-art methods.
LPNet: A Remote Sensing Scene Classification Method Based on Large Kernel Convolution and Parameter Fusion

Abstract:AbstractRemote sensing scene images contain numerous feature targets with unrelated semantic information, so how to extract to the local key information and semantic features of the image becomes the key to achieving accurate classification. Existing Convolutional Neural Networks (CNNs) mostly concentrate on the global representation of an image and lose the shallow features. To overcome these issues, this paper proposes LPNet for remote sensing scene image classification. First, LPNet employs LKConv to extract the semantic features in the image, while using standard convolution to extract local key information in the image. Additionally, the LPNet applies a shortcut residual concatenation branch to reuse features. Then, parameter fusion combines parameters from previous branches, improving the capacity of the model to obtain a more comprehensive and rich feature representation of the image. Finally, considering the relationship between the classification ability of the model and the depth of feature extraction, the Feature Mixture (FM) Block is used to deepen the model for feature extraction. Comparative experiments on four publicly available datasets show that LPNet provides comparable results to other state‐of‐the‐art methods. The effectiveness of LPNet is further demonstrated by visualizing the effective receptive fields (ERFs).
Dynamic Convolution Covariance Network Using Multi-Scale Feature Fusion for Remote Sensing Scene Image Classification

Abstract:The rapid increase in spatial resolution of remote sensing scene images (RSIs) has led to a concomitant increase in the complexity of the spatial contextual information contained therein. The coexistence of numerous smaller features makes it challenging to accurately locate and mine these features, which in turn makes accurate interpretation difficult. In order to address the aforementioned issues, this article proposes a dynamic convolution covariance network (ODFMN) based on omni-dimensional dynamic convolution, which can extract multidimensional and multiscale features from RSIs and perform statistical higher-order representation of feature information. First, in order to fully exploit the complex spatial context information of RSIs and at the same time improve the limitation of a single static convolution kernel for feature extraction, we constructed a omni-dimensional feature extraction module based on dynamic convolution, which fully extracts the 4-D information within the convolution kernel. Then, to make full use of the full-dimensional feature information extracted from each level in the network, the feature representation is enriched by constructing multiscale feature fusion module to establish relationships from local to global. Finally, higher order statistical information is employed to address the challenge of representing first-order information for smaller object features, which is inherently difficult to do. Experiments conducted on publicly available datasets have demonstrated that the method achieves high classification accuracies of 99.04%, 95.34%, and 92.50%, respectively. Furthermore, the method has been verified to have high capture accuracy for feature target contours, shapes, and spatial context information through feature visualization.

Abstract:Remote sensing scene classification has received more and more attention as important fundamental research in recent years. However, the redundant background information and complex spatial scale variability of remote sensing scene images make the existing convolutional neural network models, which mainly concentrate on global features, perform poorly. To effectively alleviate these problems, we proposed an MSRes-SplitNet model based on multiscale features and attention mechanisms for remote sensing scene image classification. First, MSRes blocks are constructed for the extraction of multi-scale features. Then, the multi-channel local features are fused by the Split-Attention block. Finally, the global and local feature information is aggregated by convolution, thus obtaining multi-scale features while alleviating the smallsample learning problem. Experiments are conducted on three publicly available datasets and compared with other state-of-the-art methods, showing that the proposed method MSRes-SplitNet has better performance while effectively reducing a large number of parameters. Abstract:Remote sensing (RS) scene classification is a challenging task due to various land covers contained in RS scenes. Recent RS classification methods demonstrate that aggregating the multilayer convolutional features, which are extracted from different hierarchical layers of a convolutional neural network, can effectively improve classification accuracy. However, these methods treat the multilayer convolutional features as equally important and ignore the hierarchical structure of multilayer convolutional features. Multilayer convolutional features not only provide complementary information for classification but also bring some interference information (e.g., redundancy and mutual exclusion). In this paper, a gated bidirectional network is proposed to integrate the hierarchical feature aggregation and the interference information elimination into an end-to-end network. First, the performance of each convolutional feature is quantitatively analyzed and a superior combination of convolutional features is selected. Then, a bidirectional connection is proposed to hierarchically aggregate multilayer convolutional features. Both the top-down direction and the bottom-up direction are considered to aggregate multilayer convolutional features into the semantic-assist feature and appearance-assist feature, respectively, and a gated function is utilized to eliminate interference information in the bidirectional connection. Finally, the semantic-assist feature and appearance-assist feature are merged for classification. The proposed method can compete with the state-of-the-art methods on four RS scene classification data sets (AID, UC-Merced, WHU-RS19, and OPTIMAL-31).
Parallel-Connected Residual Channel Attention Network for Remote Sensing Image Super-Resolution

Abstract:In recent years, convolutional neural networks (CNNs) have obtained promising results in single-image super-resolution (SR) for remote sensing images. However, most existing methods are inadequate for remote sensing image SR due to the high computational cost required. Therefore, enhancing the representation ability with fewer parameters and a shorter prediction time is a challenging and critical task for remote sensing image SR. In this paper, we propose a novel CNN called a parallel-connected residual channel attention network (PCRCAN). Specifically, inspired by group convolution, we propose a parallel module with feature aggregation modules in PCRCAN. The parallel module significantly reduces the model parameters and fully integrates feature maps by widening the network architecture. In addition, to reduce the difficulty of training a complex deep network and improve model performance, we use a residual channel attention block as the basic feature mapping unit instead of a single convolutional layer. Experiments on a public remote sensing dataset UC Merced land-use dataset revealed that PCRCAN achieved higher accuracy, efficiency, and visual improvement than most state-of-the-art methods.

Abstract:Scene classification of high resolution remote sensing images plays an important role for a wide range of applications. While significant efforts have been made in developing various methods for scene classification, most of them are based on handcrafted or shallow learning-based features. In this paper, we investigate the use of deep convolutional neural network (CNN) for scene classification. To this end, we first adopt two simple and effective strategies to extract CNN features: (1) using pre-trained CNN models as universal feature extractors, and (2) domain-specifically fine-tuning pretrained CNN models on our scene classification dataset. Then, scene classification is carried out by using simple classifiers such as linear support vector machine (SVM). In our work, three off-the-shelf CNN models including AlexNet [1], VGGNet [2], and GoogleNet [3] are investigated. Comprehensive evaluations on a publicly available 21 classes land use dataset and comparisons with several state-of-the-art approaches demonstrate that deep CNN features are effective for scene classification of high resolution remote sensing images.

Abstract:The spatial distribution of remote-sensing scene images is highly complex in character, so how to extract local key semantic information and discriminative features is the key to making it possible to classify accurately. However, most of the existing convolutional neural network (CNN) models tend to have global feature representations and lose the shallow features. In addition, when the network is too deep, gradient disappearance and overfitting tend to occur. To solve these problems, a lightweight, multi-instance CNN model for remote sensing scene classification is proposed in this paper: MILRDA. In the instance extraction and classifier part, more discriminative features are extracted by the constructed residual dense attention block (RDAB) while retaining shallow features. Then, the extracted features are transformed into instance-level vectors and the local information associated with bag-level labels is highlighted by the proposed channel-attention-based multi-instance pooling, while suppressing the weights of useless objects or backgrounds. Finally, the network is constrained by the cross-entropy loss function to output the final prediction results. The experimental results on four public datasets show that our proposed method can achieve comparable results to other state-of-the-art methods. Moreover, the visualization of feature maps shows that MILRDA can find more effective features.

Abstract:Among tasks related to intelligent interpretation of remote sensing data, scene classification mainly focuses on the holistic information of the entire scene. Compared with pixel-level or object-based tasks, it involves a richer semantic context, making it more challenging. With the rapid advancement of deep learning, convolutional neural networks (CNNs) have found widespread applications across various domains, and some work has introduced them into scene classification tasks. However, traditional convolution operations involve sliding small convolutional kernels across an image, primarily focusing on local details within a small receptive field. To achieve better modeling of the entire image, the smaller receptive field limits the ability of convolution operation to capture features over a broader range. To this end, we introduce large kernel CNNs into the scene classification task to expand the receptive field of the mode, which allows us to capture comprehensive nonlocal information while still acquiring rich local details. However, in addition to encoding spatial association, the effective information within the feature maps is also strongly channel related. Therefore, to fully model this channel dependency, a novel channel separation and mixing module has been designed to realize feature correlation in the channel dimension. The combination of them forms a large kernel separable mixed ConvNet, enabling the model to capture effective dependencies of feature maps in both spatial and channel dimensions, thus achieving enhanced feature expression. Extensive experiments conducted on three datasets have also validated the effectiveness of the proposed method.

Abstract:The use rate of urban land is a significant sign to evaluate urban construction, and scene recognition has important application value in improving urban land use rate. In this paper, a new lightweight model based on VGG16 is proposed to extract distinct features of remote sensing images through five convolution modules. This model uses depthwise separable convolution to reduce the network parameters. An adaptive pooling layer is added to solve the inherent non-adaptive problem of the convolution network. It makes the network insensitive to the size of the input image. The global average pooling layer is used to sum the information to make the input spatial transformation more stable. This paper conducts training and testing on two data sets, NWPU-RESISC45 Dataset and SIRI-WHU Dataset, and the recognition scenarios are 13 and 12 categories. Experimental results show that this method is better than other models in recognition accuracy and model size.

Abstract:Scene classification of optical remote sensing is a basic but important task because of its broad application in a range of fields. Due to the powerful feature extraction capabilities, convolutional neural networks (CNNs) have been widely used in optical remote sensing scene classification tasks. Despite the remarkable efforts have been achieved, there are still several problems existed, including the effective multiscale feature description for complex scene, rotation, and low interclass diversity problems. In this letter, to address these mentioned problems and construct a powerful CNN for optical remote sensing scene classification, an effective multiscale residual network with a high-order feature representation (MRHNet) is proposed. First, data preprocessing is utilized to adapt the rotation invariance problem. Second, related to the original residual module, a pyramid convolution is introduced to realize the multiscale feature extraction, and then, its feature description ability is further improved by an effective channel attention module. Third, inspired by the tensor decomposition and its completion, a high-order feature representation structure is designed for recovering discriminative fine-scale details into deep layers to solve the low interclass diversity problem. Finally, extensive experiments are carried on two widely used scene classification datasets (e.g., AID and NWPU-RESISC45), and comparing results show that the proposed MRHNet can achieve superior performances.

Abstract:Remote sensing image scene classification has been widely applied and has attracted increasing attention. Recently, convolutional neural networks (CNNs) have achieved remarkable results in scene classification. However, scene images have complex semantic relationships between multiscale ground objects, and the traditional stacked network structure lacks the ability to effectively extract multiscale and key features, resulting in limited feature representation capabilities. By simulating the way that humans understand and perceive images, attention mechanisms can be beneficial for quickly and accurately acquiring key features. In our study, we propose a channel-attention-based DenseNet (CAD) network for scene classification. First, the lightweight DenseNet121 is selected as the backbone for the spatial relationship between multiscale ground objects. In the spatial domain, densely connected CNN layers can extract spatial features at multiple scales and correlate with each other. Second, in the channel domain, a channel attention mechanism is introduced to strengthen the weights of the important feature channels adaptively and to suppress the secondary feature channels. Third, the cross-entropy loss function based on label smoothing is used to reduce the impact of interclass similarity upon feature representations. The proposed CAD network is evaluated on three public datasets. The experimental results demonstrate that the CAD network can achieve performance comparable to those of other state-of-the-art methods. The visualization through the Grad-CAM ++ algorithm also reflects the effectiveness of channel attention and the powerful feature representation capabilities of the CAD network.
Transferring Deep Convolutional Neural Networks for the Scene Classification of High-Resolution Remote Sensing Imagery

Abstract:Learning efficient image representations is at the core of the scene classification task of remote sensing imagery. The existing methods for solving the scene classification task, based on either feature coding approaches with low-level hand-engineered features or unsupervised feature learning, can only generate mid-level image features with limited representative ability, which essentially prevents them from achieving better performance. Recently, the deep convolutional neural networks (CNNs), which are hierarchical architectures trained on large-scale datasets, have shown astounding performance in object recognition and detection. However, it is still not clear how to use these deep convolutional neural networks for high-resolution remote sensing (HRRS) scene classification. In this paper, we investigate how to transfer features from these successfully pre-trained CNNs for HRRS scene classification. We propose two scenarios for generating image features via extracting CNN features from different layers. In the first scenario, the activation vectors extracted from fully-connected layers are regarded as the final image features; in the second scenario, we extract dense features from the last convolutional layer at multiple scales and then encode the dense features into global image features through commonly used feature coding approaches. Extensive experiments on two public scene classification datasets demonstrate that the image features obtained by the two proposed scenarios, even with a simple linear classifier, can result in remarkable performance and improve the state-of-the-art by a significant margin. The results reveal that the features from pre-trained CNNs generalize well to HRRS datasets and are more expressive than the low- and mid-level features. Moreover, we tentatively combine features extracted from different CNN models for better performance.

Abstract:Remote sensing (RS) scene classification is challenging due to changes in the scale and direction of scenes within a category. Bilinear pooling method can extract higher-order and spatial orderless information and has been shown to achieve impressive performance on various visual tasks. However, bilinear pooled features are high dimensional, which makes them impractical for subsequent processing, especially for the convolutional neural network (CNN) models with more channels in the final convolutional layer. To alleviate this shortcoming, an improved bilinear pooling method is proposed to build the compact bilinear CNN model in this work. Specifically, a joint pooling method is proposed to reduce the high-dimensional bilinear features, and it can be embedded in a bilinear CNN architecture for end-to-end optimization. Through the experimental evaluation of three real RS scene image data sets, it is proved that the improved bilinear pooling method can obtain features with higher discriminative power than the bilinear pooling method but with lower dimensionality. In addition, it also reduces the running time of model training.
A Decision-Level Fusion Method Based On Convolutional Neural Networks For Remote Sensing Scene Classification

Abstract:Scene classification is a key issue in the field of remote sensing image analysis. In recent years, a lot of scene classification methods have emerged due to the convenient acquisition of high spatial resolution remote sensing images. In the existing literature, the feature-level fusion method is widely used to improve the classification performance. In this paper, we propose a decision-level fusion method based on convolutional neural networks (CNNs) for remote sensing scene classification. The proposed method accomplishes the classification task through two steps. In the first step, a CNN is fine-tuned using the training samples, and the soft-max layer of the CNN is used to obtain the top-N possible classes of each test sample. In the second step, multiple linear support vector machines (SVMs) are trained using the features extracted from the fully-connected layer of a pre-trained CNN. The final class of each test sample is determined by the SVMs from the top-N possible classes obtained in the first step. Experiments on the widely used UC Merced data set and AID data set demonstrate the effectiveness of the proposed method.

Abstract:Scene classification is an important research topic in the field of remote sensing (RS), and deep features from convolutional neural networks (CNNs) have shown good classification performance. However, a key issue is how to effectively combine context features for further improving classification accuracy. In this letter, an end-to-end framework termed deep neural network combined with context features (CFDNN) is proposed for scene classification. At first, the pretrained VGG-16 is transferred as feature extractor to obtain convolutional features. Then, two parallel modules, global average pooling (GAP) and long short-term memory (LSTM), are employed to extract global features and context features, respectively. Finally, a weighted concatenation method is introduced to combine the global and context features. As a result, the CFDNN method can adapt high spatial resolution (HSR) images with arbitrary size and obtain satisfactory classification accuracy. The experimental results on the aerial image data set (AID) demonstrate that the proposed CFDNN method has competitive classification performance compared with some state-of-the-art methods.

Abstract:The complexity of scene images makes the research on remote-sensing image scene classification challenging. With the wide application of deep learning in recent years, many remote-sensing scene classification methods using a convolutional neural network (CNN) have emerged. Current CNN usually output global information by integrating the depth features extricated from the convolutional layer through the fully connected layer; however, the global information extracted is not comprehensive. This paper proposes an improved remote-sensing image scene classification method based on a global self-attention module to address this problem. The global information is derived from the depth characteristics extracted by the CNN. In order to better express the semantic information of the remote-sensing image, the multi-head self-attention module is introduced for global information augmentation. Meanwhile, the local perception unit is utilized to improve the self-attention module’s representation capabilities for local objects. The proposed method’s effectiveness is validated through comparative experiments with various training ratios and different scales on public datasets (UC Merced, AID, and NWPU-NESISC45). The precision of our proposed model is significantly improved compared to other methods for remote-sensing image scene classification.

Abstract:Remote sensing image scene classification is one of the current hot topics in the field of remote sensing image processing. Since convolutional neural networks (CNNs) have powerful feature extraction capabilities, they have been widely applied in remote sensing image scene classification. However, the current methods have not fully considered and utilized the complementary information between different layers of CNN and the spatial context information of remote sensing images, resulting in that the corresponding classification accuracy needs to be improved. In order to address these issues, a multilayer feature context encoding (MFCE) network is proposed and utilized to solve the problem of scene classification for remote sensing images. The proposed network is composed of two parts: I) A densely connected backbone; 2) A multiscale context encoding (MCE) module. The former is adopted to fuse the feature information of different layers of CNN. and the latter is utilized to encode and exploit the spatial context information that resides in the multilayer features. Experimental results on two large-scale remote sensing image datasets demonstrate that compared with the existing remote sensing image scene classification methods, the proposed network framework can achieve a significant gain in classification accuracy.
Fully convolutional neural networks for remote sensing image classification

Abstract:We propose a convolutional neural network (CNN) model for remote sensing image classification. Using CNNs provides us with a means of learning contextual features for large-scale image labeling. Our network consists of four stacked convolutional layers that downsample the image and extract relevant features. On top of these, a deconvolutional layer upsamples the data back to the initial resolution, producing a final dense image labeling. Contrary to previous frameworks, our network contains only convolution and deconvolution operations. Experiments on aerial images show that our network produces more accurate classifications in lower computational time.
