Abstract:Automated construction site supervision systems are critical for reducing accident risks. We propose a helmet detection system with low-altitude remote sensing by UAVs in this paper to automate the detection of helmet-wearing workers to overcome the limitations of most detection efforts that rely on ground surveillance cameras and improve the efficiency of safety supervision. The proposed system has the following key aspects. (1) We proposed an approach for speedy automatic helmet detection at construction sites regularly leveraging the flexibility and mobility of UAVs. (2) A single-stage high-precision attention-weighted fusion network is proposed, allowing the detection AP of small-sized targets to be enhanced to 88.7%, considerably improving the network's detection performance for small-sized targets. (3) Our proposed method can accurately categorize helmets based on whether they are worn or not and the type of helmet color, with an mAP of 92.87% and maximum detection accuracy in each category.

Abstract:<p>Hardhats play an essential role in protecting construction individuals from accidents. However, wearing hardhats is not strictly enforced among workers due to all kinds of reasons. To enhance construction sites safety, the majority of existing works monitor the presence and proper use of hardhats through multi-stage data processing, which come with limitations on adaption and generalizability. In this paper, a one-stage system based on convolutional neural network is proposed to automatically monitor whether construction personnel are wearing hardhats and identify the corresponding colors. To facilitate the study, this work constructs a new and publicly available hardhat wearing detection benchmark dataset, which consists of 3174 images covering various on-site conditions. Then, features from different layers with different scales are fused discriminately by the proposed reverse progressive attention to generate a new feature pyramid, which will be fed into the Single Shot Multibox Detector (SSD) to predict the final detection results. The proposed system is trained by an end-to-end scheme. The experimental results demonstrate that the proposed system is effective under all kinds of on-site conditions, which can achieve 83.89% mAP (mean average precision) with the input size 512 × 512.</p>

Abstract:The construction site environment is quite complex with many dangerous hazards (e.g., foundation pits, holes). To avoid injuries, workers must wear helmets that are color-coded for the specific type of work, which is helpful to identify whether workers are in permitted areas. Therefore, it is possible to identify unauthorized intrusion by classifying the safety helmets. This study proposes a vision-based method called Helmet-Yolov5 to automatically detect unauthorized intrusions by workers on construction sites. Multiple improvement measures are made to enhance the model performance. First, the attention mechanism is used to enhance the weights of object regions in the image, which makes the detection of small objects more effective. Second, atrous spatial pyramid pooling is adopted to preserve the detail information of the image. Third, the universal upsampling operator is introduced to fuse image features at different scales. To verify the effectiveness of the improved model, images collected from a real construction site are used to build a large-scale image dataset of safety helmets for model testing. It shows that the proposed Helmet-Yolov5 model is more accurate than the original Yolov5 model, also with high inference speed. Compared to other state-of-the-art models (e.g., Yolov4), the Helmet-Yolov5 model has considerable advantages in term of high detection accuracy and efficiency.
CA-CentripetalNet: A novel anchor-free deep learning framework for hardhat wearing detection

Abstract:Automatic hardhat wearing detection can strengthen the safety management in construction sites, which is still challenging due to complicated video surveillance scenes. To deal with the poor generalization of previous deep learning based methods, a novel anchor-free deep learning framework called CA-CentripetalNet is proposed for hardhat wearing detection. Two novel schemes are proposed to improve the feature extraction and utilization ability of CA-CentripetalNet, which are vertical-horizontal corner pooling and bounding constrained center attention. The former is designed to realize the comprehensive utilization of marginal features and internal features. The latter is designed to enforce the backbone to pay attention to internal features, which is only used during the training rather than during the detection. Experimental results indicate that the CA-CentripetalNet achieves better performance with the 86.63% mAP (mean Average Precision) with less memory consumption at a reasonable speed than the existing deep learning based methods, especially in case of small-scale hardhats and non-worn-hardhats.

Abstract:Wearing safety helmet is very essential for the safety of staff of power substations. In this paper, it proposes a detection framework of safety helmet based on the theory of machine learning and image processing technology. TensorFlow model enables to detect pedestrians, while the head position will be detected by the analysis of human Head-to-Body Ratio. Then the color space transformation and the color feature discrimination of head position are used to detect whether the staff wearing safety helmets or not. The experimental results of a large number of substation monitoring video sequences have shown that the recognition rate of wearing safety helmet detection system reach 89.0%, which proves the effectiveness of the proposed framework.
Enhancing Construction Site Safety: A Lightweight Convolutional Network for Effective Helmet Detection

Abstract:In the realm of construction safety, the detection of personal protective equipment, such as helmets, plays a critical role in preventing workplace injuries. This paper details the development and evaluation of convolutional neural networks (CNNs) designed for the accurate classification of helmet presence on construction sites. Initially, a simple CNN model comprising one convolutional block and one fully connected layer was developed, yielding modest results. To enhance its performance, the model was progressively refined, first by extending the architecture to include an additional convolutional block and a fully connected layer. Subsequently, batch normalization and dropout techniques were integrated, aiming to mitigate overfitting and improve the model's generalization capabilities. The performance of these models is methodically analyzed, revealing a peak F1-score of 84\%, precision of 82\%, and recall of 86\% with the most advanced configuration of the first study phase. Despite these improvements, the accuracy remained suboptimal, thus setting the stage for further architectural and operational enhancements. This work lays a foundational framework for ongoing adjustments and optimization in automated helmet detection technology, with future enhancements expected to address the limitations identified during these initial experiments.

Abstract:Electric power operation, as one of the key fields in the world, faces particularly prominent safety issues. Ensuring the safety of operators has become the most fundamental requirement in power operation. However, there are some safety hazards in power construction. These hazards are mainly due to weak safety awareness among staff and the failure to standardize the wearing of safety helmets. In order to effectively address this situation, technical means such as video surveillance technology and computer vision technology can be utilized to monitor whether staff are wearing helmets and provide timely feedback. Such measures will greatly enhance the safety level of power operation. This paper proposes an improved lightweight helmet detection algorithm named YOLO-M3C. The algorithm first replaces the YOLOv5s backbone network with MobileNetV3, successfully reducing the model size from 13.7 MB to 10.2 MB, thereby increasing the model's detection speed from 42.0 frames per second to 55.6 frames per second. Then, the CA attention mechanism is introduced into the backbone network to enhance the feature extraction capability of the model. Finally, in order to further improve the detection recall rate and accuracy of the model, a knowledge distillation of the model was carried out. The experimental results show that, compared with the original YOLOv5s algorithm, the average accuracy of the improved YOLO-M3C algorithm is improved by 0.123, and the recall rate is the same. These results verify that the algorithm YOLO-M3C has excellent performance in target detection and recognition, which can improve accuracy and confidence, while reducing false detection and missing detection, and effectively meet the needs of helmet-wearing detection.

Abstract:Hard-hats are the most essential safety gear on construction sites. Accidents happen due to the ignorance to wear a hard hat properly. To prevent construction accidents due to the non-usage of hard hats, automatic non-hardhat usage detection techniques have been observed to be more efficient. This paper analyses the usage of deep learning algorithms in detecting construction workers who fail to wear their hard hats properly. The accuracy of the 3 deep learning algorithms, i.e. YOLO v4, v5 and YOLACT++ have been tested using a set of data of Hard-hats collected from the crowdsourcing and web mining. These vision-based deep learning methods and algorithms have been applied and compared in terms of accuracy, scalability, and robustness. The research evaluated the different frames of construction site workers and classified image frames into different categories. The frames were input into the deep learning algorithm as per their visual categories. The objective of the paper is to analyze the present deep learning approaches for the real-time detection of the hardhat on the construction site in a way that the hardhat could be recognized efficiently without any failure and would be able to distinguish the workers who are not wearing their Hard-hats suitably and introduce a new access control system using deep learning methods to solve the problem of efficiently identifying Hard-hats for site workers. The experimental results demonstrate that the high score of precision, recall, and fast speed of the techniques, which would effectively detect non-usage of Hard-hats by site workers at different construction site conditions. This will help improve safety and supervision on construction sites.
Helmet Wearing State Detection Based on Improved Yolov5s

Abstract:At many construction sites, whether to wear a helmet is directly related to the safety of the workers. Therefore, the detection of helmet use has become a crucial monitoring tool for construction safety. However, most of the current helmet wearing detection algorithms are only dedicated to distinguishing pedestrians who wear helmets from those who do not. In order to further enrich the detection in construction scenes, this paper builds a dataset with six cases: not wearing a helmet, wearing a helmet, just wearing a hat, having a helmet, but not wearing it, wearing a helmet correctly, and wearing a helmet without wearing the chin strap. On this basis, this paper proposes a practical algorithm for detecting helmet wearing states based on the improved YOLOv5s algorithm. Firstly, according to the characteristics of the label of the dataset constructed by us, the K-means method is used to redesign the size of the prior box and match it to the corresponding feature layer to increase the accuracy of the feature extraction of the model; secondly, an additional layer is added to the algorithm to improve the ability of the model to recognize small targets; finally, the attention mechanism is introduced in the algorithm, and the CIOU_Loss function in the YOLOv5 method is replaced by the EIOU_Loss function. The experimental results indicate that the improved algorithm is more accurate than the original YOLOv5s algorithm. In addition, the finer classification also significantly enhances the detection performance of the model.

Abstract:During the construction process, ensuring construction safety is an important link to improve production efficiency, enhance corporate efficiency, and ensure employee safety. Real-time checking whether workers wear safety helmets is naturally a key task in ensuring safe production. In order to reduce the incidence of safety accidents caused by not wearing a helmet, a helmet wearing detection method based on the improved YOLO (You Only Look Once) v3 algorithm is proposed. The improvement of this paper is reflected in two aspects: one is the improvement of the YOLOv3 algorithm itself, and the other is the improvement of the overall process. Aiming at the improvement of YOLOv3, this paper improves the feature fusion steps of YOLOv3, where we use upsampling to fuse high-level features with low-level features. From the perspective of the overall process, this paper first calibrates the relevant data set, and divides the data set into four categories. For the calibrated data, transfer learning is used to train the improved YOLOv3 network. Then, these parameters and model are used to detect the categories and positions of human figures and helmets on surveillance video data. Finally, we calculate several intersection-over-unions among the four detected types, and use this to judge whether the worker is wearing a helmet correctly. Experimental results show that the proposed algorithm satisfies the real-time performance of the detection task in the helmet wearing detection, and has a higher detection accuracy rate. The mAP (mean average precision) reaches 95.13%, and this detection accuracy rate is higher than that of the traditional SSD (single shot multibox detector), Faster R-CNN (regional-convolutional neural network) and YOLOv3.
A Method of Wisdom Site Safety Helmet Detection Based on Deep Learning

Abstract:Aiming at the real-time detection of helmet wearing in construction sites with small targets, incomplete features and many interference factors, the multi-scale and multi-branch feature extraction and feature reconstruction module are applied to YOLOv5s for model reconstruction, so that each level contains convolution networks with different sizes and depths, which can capture the details of different sizes of receptive fields in the scene. The feature reconstruction is used to extract finer grained features improve the robustness of the model. Experiments on self-made construction site data sets show that compared with the YOLOv5s model, the improved algorithm improves the recognition effect of helmet wearing in the detection of long-distance small pixels and the presence of a large number of occlusion, and the real-time performance is not affected, which can meet the application needs of smart construction sites.

Abstract:The vigorous development of the construction industry has also brought unprecedented safety risks. The wearing of safety helmets at the construction site can effectively reduce casualties. As a result, this paper suggests employing a deep learning-based approach for the real-time detection of safety helmet usage among construction workers. Based on the selected YOLOv5s network through experiments, this paper analyzes its training results. Considering its poor detection effect on small objects and occluded objects. Therefore, multiple attention mechanisms are used to improve the YOLOv5s network, the feature pyramid network is improved into a BiFPN bidirectional feature pyramid network, and the post-processing method NMS is improved into Soft-NMS. Based on the above-improved method, the loss function is improved to enhance the convergence speed of the model and improve the detection speed. We propose a network model called BiFEL-YOLOv5s, which combines the BiFPN network and Focal-EIoU Loss to improve YOLOv5s. The average precision of the model is increased by 0.9% the recall rate is increased by 2.8%, and the detection speed of the model does not decrease too much. It is better suited for real-time safety helmet object detection, addressing the requirements of helmet detection across various work scenarios.

Abstract:Statistically, casualties in engineering workplaces often result from one of the following accidents: when people get stuck in the rotating machines, electric shocks or collision with heavy equipment. Most of these accidents can be prevented if the workers make proper use of personal protection equipment (PPE). This paper presents the design and implementation of a functional image detection system that takes a picture of an employee, analyses it, and determines the employee he is appropriately attired to enter a potentially hazardous workplace. This system can help to reduce the liability of company owners, by extension their costs, and can provide level of accident prevention. In this study, a convolutional neural network (CNN) was used to develop three sets of models, namely hard hat model, boot model, and vest model. These were used to detect the appearance of workers and determine if the PPE being worn was in compliance with the stipulated requirements for entry to a particularly hazardous workplace. To determine the performance of the system, each model was validated with two classes of image datasets: normal colour RGB (Red, Green and Blue) and grayscale image. The overall average accuracy of the system, in real-time implementation, then was calculated and determined to be 83.33%.

Abstract:Safety helmets are vital protective gear for construction workers, effectively reducing head injuries and safeguarding lives. By identification of safety helmet usage, workers' unsafe behaviors can be detected and corrected in a timely manner, reducing the possibility of accidents. Target detection methods based on computer vision can achieve fast and accurate detection regarding the wearing habits of safety helmets of workers. In this study, we propose a real-time construction-site helmet detection algorithm that improves YOLOv7-tiny to address the problems associated with automatically identifying construction-site helmets. First, the Efficient Multi-scale Attention (EMA) module is introduced at the trunk to capture the detailed information; here, the model is more focused on training to recognize the helmet-related target features. Second, the detection head is replaced with a self-attentive Dynamic Head (DyHead) for stronger feature representation. Finally, Wise-IoU (WIoU) with a dynamic nonmonotonic focusing mechanism is used as a loss function to improve the model's ability to manage the situation of mutual occlusion between workers and enhance the detection performance. The experimental results show that the improved YOLOv7-tiny algorithm model yields 3.3, 1.5, and 5.6% improvements in the evaluation of indices of mAP@0.5, precision, and recall, respectively, while maintaining its lightweight features; this enables more accurate detection with a suitable detection speed and is more in conjunction with the needs of on-site-automated detection.

A Two-stage Detection Algorithm for Workwear Compliance in Power Construction Scenarios Based on Feature Guidance

Abstract:In the existing electric construction scenario， the intelligent supervision scheme for wearing workwear focuses on safety helmets， and there are few schemes for the overall workwear compliance of operators. In view of the more detailed requirements of workers′ workwear compliance supervision， a two-stage compliance detection algorithm is proposed， which includes the personnel positioning stage and the human body area workwear compliance detection stage. Given the complex working posture of field personnel， a personnel positioning algorithm integrating FPN （feature pyramid network） and Guided Anchor based on Faster R-CNN is proposed. On the data set composed of more than 15,000 on-site collected samples， a personnel positioning accuracy of 91.11% is obtained， 6.0% higher than that of the ordinary Faster R-CNN scheme. The two-stage detection algorithm achieves an accuracy of 92.9% in the human body area workwear detection task， which is 11.4% higher than the single-stage Faster R-CNN scheme.

Abstract:Recognition of safety helmets wearing by construction workers is a common target detection topic in applications of deep learning-based image processing. This paper provides a study of an enhanced YOLOv5-based method, in which the challenges caused by complicated construction environment backgrounds, dense targets, and the irregular shape of safety helmets are addressed. In a trunk network, feature extraction is more based on the target shape by using the Deformable Convolution Net instead of the conventional convolution; in the Neck, a Convolutional Block Attention Module is introduced to weaken feature extraction of complex backgrounds by giving weights to enhance the characterization ability of target features; and the original network's Generalized Intersection over Union Loss is replaced by Distance Intersection over Union Loss to overcome the problem of erroneous location when the population is dense. The dataset for the training network is created by mixing open-source datasets with autonomous collecting to evaluate the effectiveness of the algorithm. We observed that the improved model has a detection accuracy of 91.6%, up 2.3% over the original network model, and a detection speed of 29 frames per second, which is compliant with most security cameras' capture frame rate.

Dynamic Attention and Bi-directional Fusion for Safety Helmet Wearing Detection

Abstract:Ensuring construction site safety requires accurate and real-time detection of workers' safety helmet use, despite challenges posed by cluttered environments, densely populated work areas, and hard-to-detect small or overlapping objects caused by building obstructions. This paper proposes a novel algorithm for safety helmet wearing detection, incorporating a dynamic attention within the detection head to enhance multi-scale perception. The mechanism combines feature-level attention for scale adaptation, spatial attention for spatial localization, and channel attention for task-specific insights, improving small object detection without additional computational overhead. Furthermore, a two-way fusion strategy enables bidirectional information flow, refining feature fusion through adaptive multi-scale weighting, and enhancing recognition of occluded targets. Experimental results demonstrate a 1.7% improvement in mAP@[.5:.95] compared to the best baseline while reducing GFLOPs by 11.9% on larger sizes. The proposed method surpasses existing models, providing an efficient and practical solution for real-world construction safety monitoring.

Abstract:Safety helmets can effectively prevent accidental head injuries to construction personnel. Helmet wearing detection is of great significance to the safety management of the construction site. The existing detection algorithms are difficult to detect small targets and dense targets, and the target occlusion and complex and changeable construction environment will reduce the detection accuracy. To solve the above problems, an intelligent helmet recognition system is designed, which combines multi-target tracking algorithm DeepSort and YOLOv5 detector. Firstly, the target bounding box is extracted by YOLOv5 algorithm and input into DeepSort framework. Further, the target trajectory prediction and tracking are realized by Kalman filter and Hungarian Algorithm. The actual test results on the complex construction sites show that the helmet recognition system based on YOLOv5 and DeepSort improves the detection speed and accuracy compared with the single detection algorithm and partial tracking algorithm. The average accuracy of the system is 94.5%, and the detection speed can reach 40fps, basically realizing real-time detection and providing an effective guarantee for the helmet-wearing detection task.

There are many deep learning frameworks, such as TensorFlow, Caffe, Theano, Torch, etc. And TensorFlow is currently one of the most mature mainstream frameworks. Based on the concept of smart construction sites, this paper puts forward a design method for detecting safety helmet system in response to frequent accidents on construction sites. Use TensorFlow's image recognition framework to train a deep learning SSD detection and recognition model to achieve accurate detection and recognition of whether a helmet is worn.
