Abstract:Multi-label classification is very common in practical applications. Compared with multi-class classification, multi-label classification has larger label space and thus the annotations of multi-label instances are typically more time-consuming. It is significant to develop active learning methods for multi-label classification problems. In addition, multi-view learning is more and more popular, which treats data from different views discriminatively and integrates information from all the views effectively. Introducing multi-view methods into active learning can further enhance its performance when processing multi-view data. In this paper, we propose multi-view active learning methods for multi-label classifications. The proposed methods are developed based on the conditional Bernoulli mixture model which is an effective model for multi-label classification. For making active selection criteria, we consider selecting informative and representative instances. From the informative perspective, least confidence and entropy of the predicting results are employed. From the representative perspective, clustering results on the unlabeled data are exploited. Particularly for multi-view active learning, novel multi-view prediction methods are designed to make final prediction and view consistency is additionally considered to make selection criteria. Finally, we demonstrate the effectiveness of the proposed methods through experiments on real-world datasets.

Abstract:In Multi-View Multi-Label Learning, each instance is described by several heterogeneous features and associated with multiple valid labels simultaneously. Existing methods mainly focus on leveraging feature-level view fusion to capture a common representation for multi-label classifier induction. In this paper, we take a new perspective and propose a new semantic-level fusion model named Common-Individual Semantic Fusion Multi-View Multi-Label Learning Method (CISF). Different from previous feature-level fusion model, our proposed method directly focuses on semantic-level view fusion and simultaneously take both the common semantic across different views and the individual semantic of each specific view into consideration. Specifically, we first assume each view involves some common semantic labels while owns a few exclusive semantic labels. Then, the common and exclusive semantic labels are separately forced to be consensus and diverse to excavate the consistences and complementarities among different views. Afterwards, we introduce the low-rank and sparse constraint to highlight the label co-occurrence relationship of common semantics and the view-specific expression of individual semantics. We provide theoretical guarantee for the strict convexity of our method by properly setting parameters. Extensive experiments on various data sets have verified the superiority of our method.

Abstract:In the current paper, we propose a probabilistic generative model, the label correlation mixture model (LCMM), to depict multi-labeled document data, which can be utilized for multi-label text classification. LCMM assumes two stochastic generative processes, which correspond to two submodels: 1) a label correlation model; and 2) a label mixture model. The former model formulates labels' generative process, in which a label correlation network is created to depict the dependency between labels. Moreover, we present an efficient inference algorithm for calculating the generative probability of a multi-label class. Furthermore, in order to optimize the label correlation network, we propose a parameter-learning algorithm based on gradient descent. The second submodel in the LCMM depicts the generative process of words in a document with the given labels. Different traditional mixture models can be adopted in this generative process, such as the mixture of language models, or topic models. In the multi-label classification stage, we propose a two-step strategy to most efficiently utilize the LCMM based on the framework of Bayes decision theory. We conduct extensive multi-label classification experiments on three standard text data sets. The experimental results show significant performance improvements comparing to existing approaches. For example, the improvements on accuracy and macro F-score measures in the OHSUMED data set achieve 28.3% and 37.0%, respectively. These performance enhancements demonstrate the effectiveness of the proposed models and solutions.
A Generative Probabilistic Model for Multi-label Classification

Abstract:Traditional discriminative classification method makes little attempt to reveal the probabilistic structure and the correlation within both input and output spaces. In the scenario of multi-label classification, most of the classifiers simply assume the predefined classes are independently distributed, which would definitely hinder the classification performance when there are intrinsic correlations between the classes. In this article, we propose a generative probabilistic model, the Correlated Labeling Model (CoL Model), to formulate the correlation between different classes. The CoL model is presented to capture the correlation between classes and the underlying structures via the latent random variables in a supervised manner. We develop a variational procedure to approximate the posterior distribution and employ the EM algorithm for the empirical Bayes parameter estimation. In our evaluations, the proposed model achieved promising results on various data sets.

Abstract:Recent years have witnessed a considerable surge of interest in the multi-label learning problem. It has been shown that a key factor for a successful multi-label learning algorithm is to effectively exploit relations between labels. However, most of the previous work exploiting label relations focuses on pairwise relations. To handle the situations where there are intrinsic correlations among multiple labels, in this paper, we propose a generative model, Labeled Four-Level Pachinko Allocation Model (L-F-L-PAM), to capture correlations among multiple labels. In our approach of multi-label learning on text data, we apply the proposed model for inferring the training data and the standard Four-Level Pachinko Allocation Model for the test data. Furthermore, we propose a pruned Gibbs Sampling algorithm in the test stage to reduce the inference time. Finally, extensive experiments have been performed to validate the effectiveness and efficiency of our new approach. The results demonstrate significant improvements of our model over Labeled LDA (L-LDA) and superiority in terms of both effectiveness and computational efficiency over other high-performing multi-label learning methods.
Partial Multi-label Learning with Label and Feature Collaboration

Abstract:Partial multi-label learning (PML) models the scenario where each training instance is annotated with a set of candidate labels, and only some of the labels are relevant. The PML problem is practical in real-world scenarios, as it is difficult and even impossible to obtain precisely labeled samples. Several PML solutions have been proposed to combat with the prone misled by the irrelevant labels concealed in the candidate labels, but they generally focus on the smoothness assumption in feature space or low-rank assumption in label space, while ignore the negative information between features and labels. Specifically, if two instances have largely overlapped candidate labels, irrespective of their feature similarity, their ground-truth labels should be similar; while if they are dissimilar in the feature and candidate label space, their ground-truth labels should be dissimilar with each other. To achieve a credible predictor on PML data, we propose a novel approach called PML-LFC (Partial Multi-label Learning with Label and Feature Collaboration). PML-LFC estimates the confidence values of relevant labels for each instance using the similarity from both the label and feature spaces, and trains the desired predictor with the estimated confidence values. PML-LFC achieves the predictor and the latent label matrix in a reciprocal reinforce manner by a unified model, and develops an alternative optimization procedure to optimize them. Extensive empirical study on both synthetic and real-world datasets demonstrates the superiority of PML-LFC.
Gaussian Mixture Variational Autoencoder with Contrastive Learning for Multi-Label Classification

Abstract:Multi-label classification (MLC) is a prediction task where each sample can have more than one label. We propose a novel contrastive learning boosted multi-label prediction model based on a Gaussian mixture variational autoencoder (C-GMVAE), which learns a multimodal prior space and employs a contrastive loss. Many existing methods introduce extra complex neural modules like graph neural networks to capture the label correlations, in addition to the prediction modules. We find that by using contrastive learning in the supervised setting, we can exploit label information effectively in a data-driven manner, and learn meaningful feature and label embeddings which capture the label correlations and enhance the predictive power. Our method also adopts the idea of learning and aligning latent spaces for both features and labels. In contrast to previous works based on a unimodal prior, C-GMVAE imposes a Gaussian mixture structure on the latent space, to alleviate the posterior collapse and over-regularization issues. C-GMVAE outperforms existing methods on multiple public datasets and can often match other models' full performance with only 50% of the training data. Furthermore, we show that the learnt embeddings provide insights into the interpretation of label-label interactions.

In each, severe permanent perceptive hearing loss had developed during antituberculous therapy with streptomycin sulphate in conventional doses. Although unproven by the data available in this study, the familial aggregation and pattern of distribution of sensitivity to streptomycin suggested autosomal dominant inheritance.

Abstract:In this paper, we propose a novel framework for multi-label classification, which directly models the dependencies among labels using a Bayesian network. Each node of the Bayesian network represents a label, and the links and conditional probabilities capture the probabilistic dependencies among multiple labels. We employ our Bayesian network structure learning method, which guarantees to find the global optimum structure, independent of the initial structure. After structure learning, maximum likelihood estimation is used to learn the conditional probabilities among nodes. Any current multi-label classifier can be employed to obtain the measurements of labels. Then, using the learned Bayesian network, the true labels are inferred by combining the relationship among labels with the labels׳ estimates obtained from a current multi-labeling method. We further extend the proposed multi-label classification method to deal with incomplete label assignments. Structural Expectation-Maximization algorithm is adopted for both structure and parameter learning. Experimental results on two benchmark multi-label databases show that our approach can effectively capture the co-occurrent and the mutual exclusive relation among labels. The relation modeled by our approach is more flexible than the pairwise or fixed subset labels captured by current multi-label learning methods. Thus, our approach improves the performance over current multi-label classifiers. Furthermore, our approach demonstrates its robustness to incomplete multi-label classification.
Probability-based Label Enhancement for Multi-Dimensional Classification

Abstract:Multi-dimensional classification (MDC) assumes that each instance has multiple heterogeneous class spaces simultaneously, and each class variable describes the semantic information of instances from a specific dimension. Recent studies have proven that encoding heterogeneous class spaces into a special logical-label space and employing the label enhancement technique to learn latent real-number labels (i.e., label distributions) of instances is an effective strategy for MDC. However, the adopted label enhancement methods can result that data whose features are quite different to each other have similar label distributions. To tackle this problem, we propose a novel probability-based label enhancement approach for MDC. Specifically, manifold structures of the feature and label distribution spaces are transformed into two different probability distributions, and we expect them to be close. Subsequently, it makes label distributions of samples whose features have large differences be more differentiated. Moreover, the logical-label mapping and reconstruction terms are designed to preserve the intrinsic information from the logical-label space. Besides, an improved multi-output support vector regression is developed as the prediction model, where we introduce mean squared error to reduce the risk of model underfitting. Experimental results on ten benchmark datasets clearly validate the superiority of our method over state-of-the-art MDC baselines.

The experimental results in comparison with other competitive methods demonstrate the effectiveness of LCMM.
Scalable Label Distribution Learning for Multi-Label Classification

Abstract:Multi-label classification (MLC) refers to the problem of tagging a given instance with a set of relevant labels. Most existing MLC methods are based on the assumption that the correlation of two labels in each label pair is symmetric, which is violated in many real-world scenarios. Moreover, most existing methods design learning processes associated with the number of labels, which makes their computational complexity a bottleneck when scaling up to large-scale output space. To tackle these issues, we propose a novel method named Scalable Label Distribution Learning (SLDL) for multi-label classification which can describe different labels as distributions in a latent space, where the label correlation is asymmetric and the dimension is independent of the number of labels. Specifically, SLDL first converts labels into continuous distributions within a low-dimensional latent space and leverages the asymmetric metric to establish the correlation between different labels. Then, it learns the mapping from the feature space to the latent space, resulting in the computational complexity is no longer related to the number of labels. Finally, SLDL leverages a nearest-neighbor-based strategy to decode the latent representations and obtain the final predictions. Extensive experiments illustrate that SLDL achieves very competitive classification performances with little computational consumption.

Abstract:Amidst advancements in feature extraction techniques, research on multi-view multi-label classifications has attracted widespread interest in recent years. However, real-world scenarios often pose a challenge where the completeness of multiple views and labels cannot be ensured. At present, only a handful of techniques have attempted to address the complex issue of partial multi-view incomplete multi-label classification, and the majority of these approaches overlook the significance of manifold structures between instances. To tackle these challenges, we propose a novel partial multi-view incomplete multi-label learning model, termed MSLPP. Differing from existing studies, MSLPP emphasizes retaining the effective inherent structure of data during the feature extraction process, thereby facilitating a richer semantic information extraction. Specifically, MSLPP captures and integrates four types of information: the distance and similarity information in the original feature space, and the distance and similarity information in the extracted feature space. Further, by adopting the graph embedding technique, it simultaneously preserves the intrinsic structure with multi-scale information through a constraint term. Moreover, taking into account the negative impact of the missing views on the model and the possible impact of missing views on the data inherent structure, we further propose a shielding strategy for missing views, which not only eliminates the negative effects of missing views on the model but also more accurately captures the inherent data structure. The experimental results on five widely recognized datasets indicate that the model performs better than many excellent methods.
A Label Embedding Method via Conditional Covariance Maximization for Multi-label Classification.

Abstract:Multi-label classification has revealed broad applications and outstanding importance in machine learning and data mining. In the multi-label domain, in addition to the problems including large instance size and high-dimensional features which need to be addressed urgently, the dimensionality of label space is increasing rapidly, leading to high computational overhead and curse of dimensionality. For tackling this issue, a typical technique called label space dimensionality reduction (LSDR) has been proposed, whose various corresponding methods are responsible for converting the high-dimensional label space into a low-dimensional one, including label embedding (LE) and label selection (LS), and then solve a low-dimensional classification or regression problem efficiently. In this paper, we focus on LE approaches, whose performance greatly depends on a preferable LE criterion. We investigate the conditional covariance operator, which originally is a nonlinear kernel-based dependence between two random vectors, formulated as a trace operation including label Gram matrix and feature Gram inverse matrix. We simplify this operator with linear label kernel matrix, which is then maximized under orthonormal constraints, resulting in an eigenvector problem. Therefore, our compression and recovery matrices correspond to those eigenvectors with several top-ranked eigenvalues. Our proposed novel LE method based on conditional covariance maximization is termed as ML-CCM for short. The experiments on four public benchmark data sets demonstrate that our proposed technique is statistically superior to three state-of-the-art LE methods on the basis of two performance evaluation metrics.
Multi-Label Bayesian Active Learning with Inter-Label Relationships

Abstract:The primary challenge of multi-label active learning, differing it from multi-class active learning, lies in assessing the informativeness of an indefinite number of labels while also accounting for the inherited label correlation. Existing studies either require substantial computational resources to leverage correlations or fail to fully explore label dependencies. Additionally, real-world scenarios often require addressing intrinsic biases stemming from imbalanced data distributions. In this paper, we propose a new multi-label active learning strategy to address both challenges. Our method incorporates progressively updated positive and negative correlation matrices to capture co-occurrence and disjoint relationships within the label space of annotated samples, enabling a holistic assessment of uncertainty rather than treating labels as isolated elements. Furthermore, alongside diversity, our model employs ensemble pseudo labeling and beta scoring rules to address data imbalances. Extensive experiments on four realistic datasets demonstrate that our strategy consistently achieves more reliable and superior performance, compared to several established methods.

Abstract:Multi-view multi-label (MVML) learning is a framework for solving the problem of associating a single instance with a set of class labels in the presence of multiple types of data features. The extraction of shared features among multiple views for label prediction is a common MVML learning method. However, previous approaches assumed that the number and association degree of shared features were the same across views. In fact, they differ in the number and degree of association. The above assumption can lead to a poor communicability of the views. Therefore, this paper proposes an MVML learning method based on the inconsistent shared features extracted by the graph attention model. The first step is to extract the shared and private features of multiple views. Next, the graph attention mechanism is adopted to learn the association degree of shared features of different views and calculate the adjacency matrix and attention coefficient. The number of associations is determined by taking the obtained adjacency matrix as a mask matrix, while the association degree of shared features is measured by the attention weight matrix. Finally, the new shared features are obtained for multi-label prediction. We conducted experiments on seven MVML datasets to compare the proposed algorithm with seven advanced algorithms. The experimental results demonstrate the advantages of our algorithm.

Abstract:Multi-view clustering (MvC) accomplishes sample classification tasks by exploring information from different views. Currently, researchers have paid greater attention to graph-based MvC methods. However, most existing methods only consider the original graph structure and pay relatively little attention to the graph structure in the latent space. In addition, most methods need to pay more attention to the consistency of information on different labels. Otherwise, this may lead to the loss of label information. This paper presents a new multi-view clustering framework to address the above issues. The proposed method considers both the information in the latent space and the original data space, which firstly obtains the pseudo-label by latent representation learning and then lets the pseudo-label guide the learning of the complementary information between the raw data views. To ensure the integrity of the data structure, a latent graph structure recovery strategy is designed in the latent space. Finally, an enhanced label fusion strategy is designed to fusion the different types of labels, yielding an information-rich label matrix for clustering. Experimental results demonstrate the proposed method's effectiveness compared to other advanced approaches.

Abstract:In multi-label learning, each example is represented by a single instance and associated with multiple class labels. Existing multi-label learning algorithms mainly exploit label correlations globally, by assuming that the label correlations are shared by all the examples. Moreover, these multi-label learning algorithms exploit the positive label correlations among different class labels. In practical applications, however, different examples may share different label correlations, and the labels are not only positive correlated, but also mutually exclusive with each other. In this paper, we propose a simple and effective Bayesian model for multi-label classification by exploiting Local positive and negative Pairwise Label Correlations, named LPLC. In the training stage, the positive and negative label correlations of each ground truth label for all the training examples are discovered. In the test stage, the k nearest neighbors and their corresponding positive and negative pairwise label correlations for each test example are first identified, then we make prediction through maximizing the posterior probability, which is estimated on the label distribution, the local positive and negative pairwise label correlations embodied in the k nearest neighbors. A comparative study with the state-of-the-art approaches manifests a competitive performance of our proposed method.

Abstract:In multi-label learning, each object is represented by a single instance while associated with a set of class labels, and labels often have correlations with each other. Exploiting label correlations can improve the performances of classifiers. Current multi-label classification methods mainly consider the correlations from label pairwise or label chain. In this paper, we propose a simple and efficient framework for multilabel classification, called Latent Dirichlet Allocation Multi-Label(LDAML), which aims at leaning the global correlations by using the topic model on the class labels. We regard the label set associated with each instance as a document and each class label in the label set as a word, then obtain the topic in the label space by topic model. The topics of label set which are introduced into feature space as the information of the correlations can improve the prediction. Extensive experiments clearly validate the effectiveness of the proposed approach.
