Rapid Determination of Componential Contents and Calorific Value of Selected Agricultural Biomass Feedstocks Using Spectroscopic Technology

Abstract:Rapid determination of biomass feedstock properties is of value for the production of biomass densification briquetting fuel with high quality. In the present study, visible and near-infrared (Vis-NIR) spectroscopy was employed to build prediction models of componential contents, i.e. moisture, ash, volatile matter and fixed-carbon, and calorific value of three selected species of agricultural biomass feedstock, i.e. pine wood, cedar wood, and cotton stalk. The partial least squares (PLS) cross validation results showed that compared with original reflection spectra, PLS regression models developed for first derivative spectra produced higher prediction accuracy with coefficients of determination (R-2) of 0.97, 0.94 and 0.90, and residual prediction deviation (RPD) of 6.57, 4.00 and 3.01 for ash, volatile matter and moisture, respectively. Good prediction accuracy was achieved with R-2 of 0.85 and RPD of 2.55 for fixed carbon, and R-2 of 0.87 and RPD of 2.73 for calorific value. It is concluded that the Vis-NIR spectroscopy is promising as an alternative of traditional proximate analysis for rapid determination of componential contents and calorific value of agricultural biomass feedstock.

Abstract:Lignocellulosic components including hemicellulose, cellulose and lignin are the three major components of plant cell walls, and their proportions in biomass crops, such as Miscanthus sinensis, greatly impact feed stock conversion to liquid fuels or bio-products. In this study, the feasibility of using visible and near infrared (VIS/NIR) spectroscopy to rapidly quantify hemicellulose, cellulose and lignin in M. sinensis was investigated. Initially, prediction models were established using partial least squares (PLS), least squares support vector machine regression (LSSVR), and radial basis function neural network (RBF_NN) based on whole wavelengths. Subsequently, 23, 25 and 27 characteristic wavelengths for hemicellulose, cellulose and lignin, respectively, were found to show significant contribution to calibration models. Three determination models were eventually built by PLS, LS-SVM and ANN based on the characteristic wavelengths. Calibration models for lignocellulosic components were successfully developed, and can now be applied to assessment of lignocellulose contents in M. sinensis.

Abstract:In this study, a calibration model based on Near-infrared spectroscopy (NIR) technique and chemometrics method was developed for rapid and non-destructive detecting the polysaccharide contents of lentinula edodes samples collected from different regions. The polysaccharide contents of these samples were firstly determined by standard phenol-sulphruic acid method. Then, NIR spectra of these samples were collected by using Fourier transform infrared spectrometry. Based on these experimental data, a random forest method was further used to distinguish the regions of these samples, with a classification accuracy of 96.6%. After that, a rapid, accurate, and quantitative model was established for predicting the polysaccharide contents of these samples. In the model establishing process, some signal pre-treatment methods were optimized, and the validation results with highest determination coefficient (R2) and low root mean square errors of prediction (RMSEP) were, 0.925 and 0.720, respectively. These results showed that combined NIR technique with chemometrics was an effective and green method for lentinula edodes quality control.
A model transfer strategy based on screening stable wavelength for quantitative analysis of holocellulose and lignin content distribution in pulpwood

Abstract:The application of near-infrared spectroscopy (NIR) technology in analyzing the compositional content of wood from pulping raw materials suffers from the problem that the multivariate correction model cannot be shared among different NIR spectrometers. To address this problem, NIR spectra of 84 samples of common pulpwood species ( Cunninghamia lanceolata , Eucalyptus robusta Smith , Acacia , Pinus massoniana , Populus L) are analyzed by traditional laboratory methods for the content of their main components (holocellulose and lignin content). Screening wavelengths based on spectrum ratio analysis (SWSRA) combined with UVE algorithm is used to screen stable characteristic bands, clarify the characteristic absorption of holocellulose and lignin, and optimize the model transfer results. The results are compared with those of SWSRA, CARS, piecewise direct correction algorithm (PDS) and slope intercept algorithm ( S / B ). The results show that for holocellulose, the 653 wavelengths screened by the SWSRA-UVE method contain a large amount of overtone and group frequency absorption information of C–H and O–H of holocellulose. For lignin, the 639 wavelengths screened by the SWSRA-UVE method contain a large amount of overtone and group frequency absorption information of lignin C–H and C=O. The SWSRA-UVE algorithm is optimal in improving the transfer effect of the models. This method can effectively remove the unimportant wavelengths in the SWSRA method and significantly improve the transfer accuracy and efficiency of the master models. This study contributes to the promotion of near-infrared spectroscopy in the rapid analysis and determination of the main components of pulping raw wood.

Abstract:A rapid predictive method based on near-infrared spectroscopy (NIRS) was developed to measure acid detergent fiber (ADF), neutral detergent fiber (NDF), and acid detergent lignin (ADL) of rice stem materials. A total of 207 samples were divided into two subsets, one subset (similar to 136 samples) for calibration and cross-validation and the other subset for independent external validation to evaluate the calibration equations. Different mathematical treatments were applied to obtain the best calibration and validation results. The highest coefficient of determination for calibration (R(2)) and coefficient of determination for cross-validation (1-VR) were 0.968 and 0.949 for ADF, 0.846 and 0.812 for NDF, and 0.897 and 0.843 for ADL, respectively. Independent external validation still gave a high coefficient of determination for external validation (r(2)) and a low standard error of performance (SEP) for the three parameters; the best validation results were SEP 0.933 and r(2) = 0.959 for ADIF, SEP = 2.228 and r(2) = 0.775 for NDF, and SEP = 0.616 and r(2) = 0.847 for ADL, indicating that NIR gave a sufficiently accurate prediction of ADF and ADL content of rice material but a less satisfactory prediction for NDF. This study suggested that routine screening for these forage quality parameters with large numbers of samples is possible with NIRS in early-generation selection in rice-breeding programs.
Machine learning prediction of lignin content in poplar with Raman spectroscopy

Abstract:Based on features extracted from Raman spectra, regularization algorithms, SVR, DT, RF, LightGBM, CatBoost, and XGBoost were used to develop prediction models for lignin content in poplar. Firstly, Raman features extracted from FT-Raman spectra after data processing were used as input of models and determined lignin contents were output. Secondly, grid-search combined with cross-validation was used to adjust the hyper-parameters of models. Finally, the predictive models were built by aforementioned algorithms. The results indicated regularization algorithms, SVR, DT held test R2 were >0.80 which means the predictive values from model still deviate from measured ones. Meanwhile, RF, LightGBM, CatBoost, and XGBoost were better than above algorithms, and their test R2 were >0.91 which suggesting the predictive values was nearly close to measured ones. Therefore, fast and accurate methods for predicting lignin content were obtained and will be useful for screening suitable lignocellulosic resource with expected lignin content.

Abstract:The quick and non-invasive evaluation of lignin from biomass has been the focus of much attention. Several types of spectroscopies, for example, near-infrared (NIR) and Fourier transform–Raman (FT–Raman), have been successfully applied to build quantitative predictive lignin models based on chemometrics. However, due to the effect of sample moisture content and ambient humidity on its signals, NIR spectroscopy requires sophisticated pre-testing preparation. In addition, the current FT–Raman predictive models require large variations in the independent value inputs as restrictions in the corresponding mathematical algorithms prevent the effective biomass screening of suitable genotypes for lignin contents within a narrow range. In order to overcome the limitations associated with the current methods, in this paper, we employed Raman spectra excited using a 1064 nm laser, thus avoiding the impact of water and auto-fluorescence on NIR signals. The optimal baseline correction method, data type, mathematical algorithm, and internal reference were selected in order to build quantitative lignin models based on the data with limited variation. The resulting two predictive models, constructed through lasso and ridge regressions, respectively, proved to be effective in assessing the lignin content of poplar in large-scale breeding and genetic engineering programs.This article has not yet been cited by other publications.

Abstract:Pulp feedstock components (including extractives, lignin and holocellulose) are major products of the pulp and paper industry, and their proportion in production feedstock (e.g., wood) greatly impact pulp yield and pulp production costs. Near-infrared (NIR) spectroscopy offers a potential solution for rapid characterizing physical and chemical properties of woody biomass. However, NIR models are highly specific to the physical form and species of the samples used in the production process. Traditional calibration transfer (CT) methods usually fail to adapt NIR models to significant differences between spectra. Adversarial transfer learning (ATL) strategies, an emerging algorithm in computer imaging, align source and target distributions by introducing adversarial mechanisms. For the first time, deep ATL architecture, coupled with NIR spectroscopy (collected from ASD LabSpecPro spectrometer), was applied to quantitatively predict the pulpwood feedstock component content for adapting models of different physical forms (wood blocks, wood meals) and tree species to each other without the need for constructing a new model. It was discovered that ATL methods, including domain adversarial neural networks (DANN), domain separation networks (DSN), and dynamic adversarial adaptation networks (DAAN) not only remove the differences between wood block and wood meal spectral data sources (i.e., domains), but also make desired predictions for cross-species domain adaptation. The robustness and stability of the transferred models exceed those of traditional CT and transfer learning methods. Our results suggest that ATL models could be effectively adapted to polymorphic, multi-species pulp feedstock data, and can be extended to the detection and inversion of other feedstock properties.

Abstract:In NIR spectral modeling, the method of screening wavelengths with consistent stable signals (SWCSS) is based on a standard-free algorithm. However, the wavelengths selected by SWCSS may contain invalid information. In this paper, the Competitive Adaptive Reweighted Sampling (CARS) wavelength optimization algorithm was used in conjunction with SWCSS to eliminate the uninformative variables in the wavelengths selected by SWCSS. The SWCSS-CARS method was based on three near-infrared spectrometers (Lengguang 1, Lengguang 2, and Lengguang 3), with Lengguang 1 as the master and the other two instruments as the targets, using a total of 84 sample spectra of five types of pulpwood and their lignin contents as the research objects. Compared with the full spectrum, the number of wavelengths was reduced from 1601 to 24 in the model built using the coupling algorithm. For target 1, the value of RPD was improved from 1.9247 to 3.1880; for target 2, t the value of RPD was improved from 1.7415 to 3.2508. The wavelengths selected by the SWCSS-CARS coupling algorithm were able to build stable, robust models.

Abstract:Characteristic variables are essential and necessary basis in model construction, and are related to the prediction result closely in near infrared spectroscopy (NIRS) analysis. However, the same compound usually has different characteristic variables for different analysis and it would be lower correlation between variables and structure in many researches. So, the accuracy and reliability are expected to improve by exploring characteristic variables in different spectrum analysis. In this study, competitive adaptive weighted resampling method (CARS) was applied to select characteristic variables related to baicalin from NIRS analysis data, which were applied to analysis of baicalin in three different processes including the herb, extraction process and concentration process of Scutellaria baicalensis. After application of CARS method, 70, 50 and 50 variables were selected respectively from three processes above. The selected variables were firstly analyzed by statistical methods that they were found to be consistent and correlated among three different processes after one-way analysis of variance test and Kendall's W. Partial least-squares (PLS) regression and extreme learning machine (ELM) models were constructed based on optimized data. Models after variable selection were less complicated and had better prediction results than global models. After comparison, CARS-PLS was suitable for the prediction of extraction process, while for the concentration process and herb, CARS-ELM performed better. The Rc value of the herb, extraction and concentration model were 0.9469, 0.9841 and 0.9675, respectively. The RSEP values were 4.54%, 6.96% and 8.37%, respectively. The results help to frame a theoretical basis for characteristic variables of baicalin.

Abstract:In this study, regularization algorithms (RR, LR, and ENR), classical ML algorithms (SVR, DT, and RF), and advanced GBM algorithms (LightGBM, CatBoost, and XGBoost) were applied to build the holocellulose content predictive models of poplar based on features extracted from Raman spectra. Evaluation results of models indicate that classical ML algorithms show higher predictive accuracy than regularization algorithms, and the advanced GBM algorithms better than the classical ML algorithms. Furthermore, models built by CatBoost and XGBoost can estimate holocellulose content with high predictive accuracy of test R2 above 0.93 and test RMSE less than 0.29%. It provides the heretofore best precision of holocellulose content predictive model based on Raman spectroscopy so far for our knowledge. Therefore, it is suggested that Raman spectroscopy coupled with ML algorithms is a promising tool for predicting the holocellulose content in poplar which can be applied in large-scale tree genetic and breeding programs.

Abstract:The potential of near infrared (NIR) spectroscopy for non-destructive determination of quality parameters including oil and protein contents in shell-intact cottonseed was investigated. Linear partial least squares (PLS) and nonlinear least-squares support vector machine (LS-SVM) methods were used to develop the calibration models to determinate the protein and oil contents. Moreover, as variable selection techniques, the Monte Carlo uninformative variable elimination (MC-UVE) and the successive projections algorithm (SPA) were applied to improve the predictive ability of the model. Finally, the MC-UVE-LS-SVM models show the best prediction performance. The coefficient of determination (R-2), residual predictive deviation (RPD) and root mean squares error of prediction (RMSEP) were 0.959, 4.871 and 0.977 for protein, and 0.950, 4.429 and 0.834 for oil, respectively. The results indicate that NIR technology could be very useful for the rapid quality analysis of shell-intact cottonseed avoiding the need of grinding. Furthermore, the variable selection of MC-UVE can provide more robust and accurate calibration models than SPA. (C) 2012 Elsevier B.V. All rights reserved.

Abstract:In order to improve the technical level of the rapid detection of liquor fermented grains, in this paper, use near infrared spectroscopy technology to quantitative analysis moisture, starch, acidity and alcohol of liquor fermented grains. Using CARS, iPLS and no information variable elimination method (UVE), realize the characteristics of spectral band selection. And use the multiple scattering correction (MSC), derivative and standard normal variable transformation (SNV) pretreatment method to optimize the models. Establish models of quantitative analysis of fermented grains by PLS, and in order to select the best modeling method, using R-2, RMSEP and optimal number of main factors to evaluate models. The results showed that the band selection is vital to optimize the model and CARS is the best optimization of the most significant effect. The calculation results showed that R2 of moisture, starch, acidity and alcohol were 0. 885, 0. 915, 0. 951, 0. 885 respectively and RMSEP of moisture, starch, acidity and alcohol were 0. 630, 0. 519, 0. 228, 0. 234 respectively. After optimization, the model prediction effect is good, the models can satisfy the requirement of the rapid detection of liquor fermented grains, which has certain reference value in the practical.
Feasibility of an NIR spectral calibration transfer algorithm based on optimized feature variables to predict tobacco samples in different states.

Abstract:The prediction accuracy of calibration models for near-infrared (NIR) spectroscopy typically relies on the morphology and homogeneity of the samples. To achieve non-homogeneous tobacco samples for non-destructive and rapid analysis, a method that can predict tobacco filament samples using reliable models based on the corresponding tobacco powder is proposed here. First, as it is necessary to establish a simple and robust calibrated model with excellent performance, based on full-wavelength PLSR (Full-PLSR), the key feature variables were screened by three methods, namely competitive adaptive reweighted sampling (CARS), variable combination population analysis-iteratively retaining informative variables (VCPA-IRIV), and variable combination population analysis-genetic algorithm (VCPA-GA). The partial least squares regression (PLSR) models for predicting the total sugar content in tobacco were established based on three optimal wavelength sets and named CARS-PLSR, VCPA-IRIV-PLSR and VCPA-GA-PLSR, respectively. Subsequently, they were combined with different calibration transfer algorithms, including calibration transfer based on canonical correlation analysis (CTCCA), slope/bias correction (S/B) and non-supervised parameter-free framework for calibration enhancement (NS-PFCE), to evaluate the best prediction model for the tobacco filament samples. Compared with the previous two transfer algorithms, NS-PFCE performed the best under various wavelength conditions. The prediction results indicated that the most successful approach for predicting the tobacco filament samples was achieved by VCPA-IRIV-PLSR when coupled with the NS-PFCE method, which obtained the highest determination coefficient ( = 0.9340) and the lowest root mean square error of the prediction set (RMSEP = 0.8425). VCPA-IRIV simplifies the calibration model and improves the efficiency of model transfer (31 variables). Furthermore, it pledges the prediction accuracy of the tobacco filament samples when combined with NS-PFCE. In summary, calibration transfer based on optimized feature variables can eliminate prediction errors caused by sample morphological differences and proves to be a more beneficial method for online application in the tobacco industry.

Abstract:Variable selection methods can simplify the modelling process and improve the accuracy of models constructed for rapid monitoring using near-infrared (NIR) spectroscopy. In this study, NIR spectroscopy was applied in combination with chemometrics to determine the icariin, salvianolic acid B, and puerarin content, as well as the relative density through the concentration process of a Yangxinshi tablet (YXST) water extraction solution. Partial least squares with several variable selection algorithms were used for the modelling. Variable selection methods, including synergy interval partial least squares (Si-PLS), a genetic algorithm, competitive adaptive reweighted sampling (CARS), and their combination, were comparatively applied to calibrate the regression model. The performances of the models obtained were systematically evaluated according to the correlation coefficients of prediction (Rp), the relative standard error of prediction (RSEP), and the residual predictive deviation (RPD). For icariin, salvianolic acid B, and puerarin, the Si-PLS model showed optimal results. The Rp, RSEP, and RPD of Si-PLS were 0.9905, 7.84%, and 7.38 for icariin; 0.9781, 9.48%, and 4.80 for salvianolic acid B; and 0.9668, 12.81%, and 3.92 for puerarin, respectively. For the relative density, the CARS-Si-PLS acquired the best prediction results. The Rp, RSEP, and RPD of CARS-Si-PLS were 0.9725, 0.47%, and 4.31 for the relative density, respectively. This study demonstrated that variable selection methods can simplify the modelling process and improve the accuracy of the models. In addition, the methods developed in this study are suitable for a quality monitoring of the concentration process of YXST water extraction solution, and they provide reference for real-time monitoring of the concentration processes used in the preparation of other types of traditional Chinese medicine.

However, the measurement WBD is time- and cost-consuming, which an alternatively fast and no-destructive measurement is needed. In this study, capability of NIR spectroscopy combined with partial least squares regression (PLSR) to quantify the WBD were examined in multiple wood species. To obtain more accurate and robust prediction models, the grain angle (0° (transverse surface), 45°, 90° (radial surface)) influence on the collection of solid wood spectra and a comparison of found variable selection methods for NIR spectral variables optimization were conducted, including significant Multivariate Correlation (sMC), Regularized elimination procedure (Rep), Iterative predictor weighting (Ipw) and Genetic algorithm (Ga). Models made by random calibration data selection were conducted 200 times performance evaluation. Results These results indicate that 90° angle models display relatively highest efficiency than other angle models, mixed angle model yield a satisfied WBD prediction results as well and could reduce the influence of grain angle. Rep method shows a higher efficiency than other methods which could eliminate the uninformative variables and enhance the predictive performance of 90° angle and mix angle models. Conclusions This study is potentially shown that the WBD (g/cm 3 ) on solid wood across grain angles and varies wood species could be measured in a rapid and efficient way using NIR technology. Combined with the PLSR model, our methodology could serve as a tool for wood properties breeding and silviculture study.

Abstract:Raman spectroscopy is effective for studying the ultrastructure, lignin content, and cellulose crystallinity of lignocellulosic materials. However, the quantitative analysis of holocellulose in lignocellulosic materials by this technique is challenging. In this study, based on Fourier-transform Raman (FT-Raman) spectroscopy, a novel strategy for building poplar holocellulose content quantitative model was proposed. Different algorithms were applied, including Principal component regression (PCR), partial least square regression (PLSR), ridge regression (RR), lasso regression (LR), and elastic net regression (ENR). Combined with different algorithms, twelve candidates of internal standard were selected. Sixty models combined by five regression algorithms and twelve internal standards were performed by five-fold cross validation. Consequently, the models constructed through RR, LR, and ENR combined with the internal standard of peak intensity of 2945 cm-1 were credible (Rp > 0.9, RMSEp < 1.0, and MAEp < 0.9). Credible models were obtained, indicating the high potential of FT-Raman spectroscopy for predicting the holocellulose content of lignocellulosic materials.

Abstract:Journal of Near Infrared Spectroscopy, Ahead of Print. To assure the quality control of industrial processes, it is important to adopt reproducible and efficient methodologies. Spectroscopic methods, such as near infrared (NIR), are a good option as they are fast and may be used to indirectly estimate multiple physicochemical properties. In this study, NIR spectra of key feedstock samples used in the production of formaldehyde-based resin and wood-based panels (WBP), namely urea, ammonium sulfate, ammonium nitrate, sodium hydroxide, and acetic acid, were acquired. Multivariate data analysis was applied to establish the correlation between the spectra and the properties being measured. Quantitative models were then created using partial least squares (PLS) regression to predict the concentrations of feedstock samples. This study presents quantitative models that were created by combining spectra measured on two probes, which achieved similar prediction results as single-probe based models. The performances of the best models were compared with the reference methods for each of the evaluated samples. For the samples under study, the proposed approach is suitable for routine analysis across multiple equipment configurations using the same quantitative model. NIR spectroscopy combined with chemometric models could be a valuable complement to support in-line raw material monitoring and plant digitalization in the wood panels industry.

Abstract:A new method for online measurement of pulp Kappa number by means of near infrared diffuse reflectance spectroscopy and support vector machine (SVM) modeling has been developed in this paper. The near infrared diffuse reflectance spectroscopy of 45 Chinese red pine wood pulp samples was acquired. Selecting the absorption rates in 15 vibration absorption peaks of each sample and using dynamic independent component analysis (DICA) to distill the characters of input sample data, the pulp Kappa number predictive model based on SVM was built. From the whole 45 samples, 35 samples was selected to be the calibration set, and the predictive set consisted of the other 10 samples was used to validate the the pulp Kappa number predictive model. The external validation standard deviation is 0.26 for pulp Kappa number predictive model based on SVM, and the determining factor is 0.93 for the model. The internal cross validation standard deviation is 0.22 for pulp Kappa number predictive model based on SVM, and the determining factor is 0.96 for the model. To analyze the effectiveness of SVM method used to build the pulp Kappa number predictive model, the pulp Kappa number predictive model based on linear regression (LR) was also established. The external validation standard deviation is 0.45 for the model based on linear regression (LR), and the determining factor is 0.81 for the model. The internal cross validation standard deviation is 0.41 for the model based on linear regression (LR), and the determining factor is 0.85 for the model. For the 10 test samples, the pulp Kappa number predictive model based on Linear regression (LR) and the model based on SVM all have certain predictive accuracy, but the later higher. The experiment results not only show the feasibility and effectiveness of the near infrared measurement method for pulp Kappa number, but also validate that the pulp Kappa number predictive model based on SVM is more accurate and robust than linear regression model.
