In this paper, we propose a new unified set of dimensions through which to analyze and describe human-AI systems. Our conceptual model is centered around three high-level aspects - agency, interaction, and adaptation - and is developed through a multi-step process. Firstly, an initial design space is proposed by surveying the literature and consolidating existing definitions and conceptual frameworks. Secondly, this model is iteratively refined and validated by conducting semi-structured interviews with nine researchers in this field. Lastly, to illustrate the applicability of our design space, we utilize it to provide a structured description of selected human-AI systems.

Abstract:Increasingly capable Artificial Intelligence (AI) agents are reaching new performance levels and humans need to work effectively with them in a variety of collaborative team structures. Of particular interest is "shared control collaboration", where actions taken by the team depend on the blended combination of inputs from all team entities. We conducted an experiment where participants played a game and maneuvered a spacecraft while working in concert with an AI agent and simultaneously performing a secondary task. The experiment results (i) show different patterns of interactions across user interface designs, agent capabilities, and participants' game experience, (ii) underscore the importance of providing information about the shared control collaborative task to humans who are working with a less-capable agent, and (iii) imply the potential of real-time communication about agent's state to achieve better teamwork. Our findings are expected to be transferable to other shared control collaboration settings, including AI-enabled autopilots.

Abstract:Artificial Intelligence (AI) can refer to the machine learning algorithms and the automation applications built on top of these algorithms. Human-computer interaction (HCI) researchers have studied these AI applications and suggested various Human-Centered AI (HCAI) principles for an explainable, safe, reliable, and trustworthy interaction experience. While some designers believe that computers should be supertools and active appliances, others believe that these latest AI systems can be collaborators. With today's AI algorithm breakthroughs, in this panel we ask whether the supertool or the collaboration metaphors best support work and play? How can we design AI systems to work best with people or for people? What does it take to get there? This panel will bring together panelists with diverse backgrounds to engage the audience through the discussion of their shared or diverging visions on the future of human-AI interaction design.

Abstract:Researchers are investing substantial effort in developing powerful general-purpose agents, wherein Foundation Models are used as modules within agentic systems (e.g. Chain-of-Thought, Self-Reflection, Toolformer). However, the history of machine learning teaches us that hand-designed solutions are eventually replaced by learned solutions. We formulate a new research area, Automated Design of Agentic Systems (ADAS), which aims to automatically create powerful agentic system designs, including inventing novel building blocks and/or combining them in new ways. We further demonstrate that there is an unexplored yet promising approach within ADAS where agents can be defined in code and new agents can be automatically discovered by a meta agent programming ever better ones in code. Given that programming languages are Turing Complete, this approach theoretically enables the learning of any possible agentic system: including novel prompts, tool use, control flows, and combinations thereof. We present a simple yet effective algorithm named Meta Agent Search to demonstrate this idea, where a meta agent iteratively programs interesting new agents based on an ever-growing archive of previous discoveries. Through extensive experiments across multiple domains including coding, science, and math, we show that our algorithm can progressively invent agents with novel designs that greatly outperform state-of-the-art hand-designed agents. Importantly, we consistently observe the surprising result that agents invented by Meta Agent Search maintain superior performance even when transferred across domains and models, demonstrating their robustness and generality. Provided we develop it safely, our work illustrates the potential of an exciting new research direction toward automatically designing ever-more powerful agentic systems to benefit humanity.

Challenges of Human-Aware AI Systems

Abstract:From its inception, AI has had a rather ambivalent relationship to humans---swinging between their augmentation and replacement. Now, as AI technologies enter our everyday lives at an ever increasing pace, there is a greater need for AI systems to work synergistically with humans. To do this effectively, AI systems must pay more attention to aspects of intelligence that helped humans work with each other---including social intelligence. I will discuss the research challenges in designing such human-aware AI systems, including modeling the mental states of humans in the loop, recognizing their desires and intentions, providing proactive support, exhibiting explicable behavior, giving cogent explanations on demand, and engendering trust. I will survey the progress made so far on these challenges, and highlight some promising directions. I will also touch on the additional ethical quandaries that such systems pose. I will end by arguing that the quest for human-aware AI systems broadens the scope of AI enterprise, necessitates and facilitates true inter-disciplinary collaborations, and can go a long way towards increasing public acceptance of AI technologies.

Ethnographic Praxis in Industry Conference Proceedings

Abstract:This paper explores how the design of everyday interactions with artificial intelligence in work systems relates to broader issues of interest to social scientists and ethicists: namely human well‐being and social inequality. The paper uses experience designing human interactions with highly automated systems as a lens for looking at the social implications of work design, and argues that what human and automation each do is less important than how human and automation are structured to interact. The Human‐Autonomy Teaming (HAT) paradigm, explored in the paper, has been a promising alternative way to think about human interactions with automation in our laboratory's research and development work. We argue that the notion of teaming is particularly useful in that it encourages designers to consider human well‐being as central to the operational success of the overall human‐machine system that is being designed.

Abstract:Artificial intelligence, which people originally modeled after human intelligence, has made significant advances in recent years. These advances have caused many to fear that machines will surpass human intelligence and dominate humans. Intelligence augmentation (IA) has the potential to turn the tension between the two intelligence types into a symbiotic one. Although IA has not gained momentum until recent years, the idea that machines can amplify human abilities has existed for many decades. Expanded from a panel discussion on Intelligence Augmentation at the 2020 International Conference of Information Systems (ICIS), we define IA in light of its history and evolution and classify IA based on its capabilities, roles, and responsibilities. Based on reviewing the IA literature in terms of research themes, enabling technology, and applications, we identify key research issues, challenges, and future opportunities.

Abstract:This empirical study serves as a primer for interested service providers to determine if and how Large Language Models (LLMs) technology will be integrated for their practitioners and the broader community. We investigate the mutual learning journey of non-AI experts and AI through CoAGent, a service co-creation tool with LLM-based agents. Engaging in a three-stage participatory design processes, we work with with 23 domain experts from public libraries across the U.S., uncovering their fundamental challenges of integrating AI into human workflows. Our findings provide 23 actionable "heuristics for service co-creation with AI", highlighting the nuanced shared responsibilities between humans and AI. We further exemplar 9 foundational agency aspects for AI, emphasizing essentials like ownership, fair treatment, and freedom of expression. Our innovative approach enriches the participatory design model by incorporating AI as crucial stakeholders and utilizing AI-AI interaction to identify blind spots. Collectively, these insights pave the way for synergistic and ethical human-AI co-creation in service contexts, preparing for workforce ecosystems where AI coexists.

Abstract:Humans have used machines to do more with less physical control and/or interaction (by increasing the Level of Automation (LoA)). Engineers have been tasked with progressively automating functions previously completed manually. Industry continues promoting a mechanized workforce in order to minimise business variations in human performance and maximise their productivity. Researchers also continue to pursue this goal using Artificial Intelligence (AI), Computational Intelligence (CI) and Machine Intelligence (MI) techniques. This process of transforming cognitive functionality into machine actionable form has encountered bottlenecks, such as scalability and inconsistent performance. More recently, Multi-Agent Systems (MASs) have been employed to provide a flexible framework for research and development, because of their ability to easily embody system complexity. The proposed framework should facilitate the development of components, their interoperability, coordination and cooperation techniques needed to solve complex, realworld problems within a dangerous and/or dynamic environment. Based on the effort to seek or facilitate human-like decision making within machines, the lack of success indicates that further research is required. This chapter discusses one possible avenue. It involves future research, aimed at achieving a cognitive sub-system for use on-board platforms. The framework introduced in this chapter is aimed at embedding traditional heuristic knowledge and higher order cognitive computation techniques. This conceptual mechanism could ultimately be used to implement a virtual mind when technology facilitates a real-time implementation and could be used to progressively enhance automation, achieve greater independence and enable more autonomous behaviour within control systems.
AI as Extraherics: Fostering Higher-order Thinking Skills in Human-AI Interaction

Abstract:As artificial intelligence (AI) technologies, including generative AI, continue to evolve, concerns have arisen about over-reliance on AI, which may lead to human deskilling and diminished cognitive engagement. Over-reliance on AI can also lead users to accept information given by AI without performing critical examinations, causing negative consequences, such as misleading users with hallucinated contents. This paper introduces extraheric AI, a human-AI interaction conceptual framework that fosters users' higher-order thinking skills, such as creativity, critical thinking, and problem-solving, during task completion. Unlike existing human-AI interaction designs, which replace or augment human cognition, extraheric AI fosters cognitive engagement by posing questions or providing alternative perspectives to users, rather than direct answers. We discuss interaction strategies, evaluation methods aligned with cognitive load theory and Bloom's taxonomy, and future research directions to ensure that human cognitive skills remain a crucial element in AI-integrated environments, promoting a balanced partnership between humans and AI.

Abstract:Abstract Managing the design process of teams has been shown to considerably improve problem-solving behaviors and resulting final outcomes. Automating this activity presents significant opportunities in delivering interventions that dynamically adapt to the state of a team in order to reap the most impact. In this work, an artificial intelligence (AI) agent is created to manage the design process of engineering teams in real time, tracking features of teams’ actions and communications during a complex design and path-planning task in multidisciplinary teams. Teams are also placed under the guidance of human process managers for comparison. Regarding outcomes, teams perform equally as well under both types of management, with trends toward even superior performance from the AI-managed teams. The managers’ intervention strategies and team perceptions of those strategies are also explored, illuminating some intriguing similarities. Both the AI and human process managers focus largely on communication-based interventions, though differences start to emerge in the distribution of interventions across team roles. Furthermore, team members perceive the interventions from both the AI and human manager as equally relevant and helpful, and believe the AI agent to be just as sensitive to the needs of the team. Thus, the overall results show that the AI manager agent introduced in this work is able to match the capabilities of humans, showing potential in automating the management of a complex design process.

Abstract:Recent technological advances, especially in the field of machine learning, provide astonishing progress on the road towards artificial general intelligence. However, tasks in current real-world business applications cannot yet be solved by machines alone. We, therefore, identify the need for developing socio-technological ensembles of humans and machines. Such systems possess the ability to accomplish complex goals by combining human and artificial intelligence to collectively achieve superior results and continuously improve by learning from each other. Thus, the need for structured design knowledge for those systems arises. Following a taxonomy development method, this article provides three main contributions: First, we present a structured overview of interdisciplinary research on the role of humans in the machine learning pipeline. Second, we envision hybrid intelligence systems and conceptualize the relevant dimensions for system design for the first time. Finally, we offer useful guidance for system developers during the implementation of such applications.

Abstract:Recent advances in Artificial Intelligence raise interest in its participation in design activity, which is commonly considered to be complex and human-dominated. In this work, we aim to examine AI roles in early design stages. The human ideation components and design tools related to AI are discussed in a framework of AI-augmented design support. The framework develops a hierarchy of design cognition (basis), approaches and principles. The cognitive models are constructed in an empirical study of 30 designers (26 for analysis, 4 for pilot study) by concurrent Think-Aloud protocol and behavior analysis. The process of producing new design ideas is explained by a transparent analysis of designers' language and behaviors. Three strategies to organize cognitive activities in design ideation are summarized: develop structured consideration, relate to a scenario, and stick-to designing. These strategies suggest AI could act as (1) representation creation, (2) empathy trigger and (3) engagement, in principles of "knowledge-driven" and "decompose-and-integrate". The design support with AI provides new perspectives on computer-based design tools that limit to well-defined design variables. The framework is built on a generic notion of design activity and "mimic" human design rationales, expected to benefit research of domain-independent computational design supports and cognitive supports.

Abstract:Recent advancements in artificial intelligence (AI) and its sub-branch machine learning (ML) promise machines that go beyond the boundaries of automation and behave autonomously. Applications of these machines in creative practices such as art and design entail relationships between users and machines that have been described as a form of collaboration or co-creation between computational and human agents. This paper uses examples from art and design to argue that this frame is incomplete as it fails to acknowledge the socio-technical nature of AI systems, and the different human agencies involved in their design, implementation, and operation. Situating applications of AI-enabled tools in creative practices in a spectrum between automation and autonomy, this paper distinguishes different kinds of human engagement elicited by systems deemed automated or autonomous. Reviewing models of artistic collaboration during the late 20th century, it suggests that collaboration is at the core of these artistic practices. We build upon the growing literature of machine learning and art to look for the human agencies inscribed in works of computational creativity, and expand the co-creation frame to incorporate emerging forms of human-human collaboration mediated through technical artifacts such as algorithms and data.

Abstract:AI systems are increasingly being adopted across various domains and application areas. With this surge, there is a growing research focus and societal concern for actively involving humans in developing, operating, and adopting these systems. Despite this concern, most existing literature on AI and Human-Computer Interaction (HCI) primarily focuses on explaining how AI systems operate and, at times, allowing users to contest AI decisions. Existing studies often overlook more impactful forms of user interaction with AI systems, such as giving users agency beyond contestability and enabling them to adapt and even co-design the AI's internal mechanics. In this survey, we aim to bridge this gap by reviewing the state-of-the-art in Human-Centered AI literature, the domain where AI and HCI studies converge, extending past Explainable and Contestable AI, delving into the Interactive AI and beyond. Our analysis contributes to shaping the trajectory of future Interactive AI design and advocates for a more user-centric approach that provides users with greater agency, fostering not only their understanding of AI's workings but also their active engagement in its development and evolution.

Abstract:To reduce human efforts and burden on human intelligence in software-engineering activities, Artificial Intelligence (AI) techniques have been employed to assist or automate these activities. On the other hand, human's domain knowledge can serve as starting points for designing AI techniques. Furthermore, the results of AI techniques are often interpreted or verified by human users. Such user feedback could be incorporated to further improve the AI techniques, forming a continuous feedback loop. We recently proposed cooperative testing and analysis including human-tool cooperation (consisting of human-assisted computing and human-centric computing) and human-human cooperation. In this paper, we present example software-engineering problems with solutions that leverage the synergy of human and artificial intelligence, and illustrate how cooperative testing and analysis can help realize such synergy.

Abstract:Abstract The evolution of Artificial Intelligence (AI) and Machine Learning (ML) enables new ways to envision how computer tools will aid, work with, and even guide human teams. This paper explores this new paradigm of design by considering emerging variations of AI-Human collaboration: AI used as a design tool versus AI employed as a guide to human problem solvers, and AI agents which only react to their human counterparts versus AI agents which proactively identify and address needs. The different combinations can be mapped onto a 2×2 AI-Human Teaming Matrix which isolates and highlights these different AI capabilities in teaming. The paper introduces the matrix and its quadrants, illustrating these different AI agents and their application and impact, and then provides a road map to researching and developing effective AI team collaborators.

Abstract:Interactive AI systems increasingly employ a human-in-the-loop strategy. This creates new challenges for the HCI community when designing such systems. We reveal and investigate some of these challenges in a case study with an industry partner, and developed a prototype human-in-the-loop system for preference-guided 3D model processing. Two 3D artists used it in their daily work for 3 months. We found that the human-AI loop often did not converge towards a satisfactory result and designed a lab study (N=20) to investigate this further. We analyze interaction data and user feedback through the lens of theories of human judgment to explain the observed human-in-the-loop failures with two key insights: 1) optimization using preferential choices lacks mechanisms to deal with inconsistent and contradictory human judgments; 2) machine outcomes, in turn, influence future user inputs via heuristic biases and loss aversion. To mitigate these problems, we propose descriptive UI design guidelines. Our case study draws attention to challenging and practically relevant imperfections in human-AI loops that need to be considered when designing human-in-the-loop systems.

Abstract:Leveraging Artificial Intelligence (AI) in decision support systems has disproportionately focused on technological advancements, often overlooking the alignment between algorithmic outputs and human expectations. A human-centered perspective attempts to alleviate this concern by designing AI solutions for seamless integration with existing processes. Determining what information AI should provide to aid humans is vital, a concept underscored by explainable AI's efforts to justify AI predictions. However, how the information is presented, e.g., the sequence of recommendations and solicitation of interpretations, is equally crucial as complex interactions may emerge between humans and AI. While empirical studies have evaluated human-AI dynamics across domains, a common vocabulary for human-AI interaction protocols is lacking. To promote more deliberate consideration of interaction designs, we introduce a taxonomy of interaction patterns that delineate various modes of human-AI interactivity. We summarize the results of a systematic review of AI-assisted decision making literature and identify trends and opportunities in existing interactions across application domains from 105 articles. We find that current interactions are dominated by simplistic collaboration paradigms, leading to little support for truly interactive functionality. Our taxonomy offers a tool to understand interactivity with AI in decision-making and foster interaction designs for achieving clear communication, trustworthiness, and collaboration.
