Abstract:Winter jujubes get bruised easily during harvest and transportation. In order to detect subtle bruises on winter jujubes in a more efficient way, a rapid and accurate technique, hyperspectral imaging was used. Near-infrared reflectance (NIR) and visible/near-infrared reflectance (Vis-NIR) hyperspectral imaging at the spectral region of 874-1734 nm and 380-1030 nm, respectively, were applied in this study. The hyperspectral images of winter jujubes from four geographical origins were acquired. Pixel-wise spectra were extracted and preprocessed; pixel-wise principal component analysis (PCA) was used to conduct a qualitative analysis. Accuracy, true positive rate (TPR) and false positive rate (FPR) were utilized to compare the efficiency of the models. Support vector machine (SVM), logistic regression (LR) and a deep learning method, and convolutional neural network (CNN) were used to build pixel-wise classification models based on single or all geographical origins for quantitative analyses. All the models using NIR spectra obtained decent results with accuracies in the range of 90-100%, and TPRs and FPRs close to 1 and 0, respectively. Compared with the other two methods using Vis-NIR spectra, the CNN model based on all geographical origins got the best performance with most of the accuracies surpassing 85%. For Vis-NIR spectra and NIR spectra, the overall time efficiency for modeling and prediction of CNN was at an intermediate level among the three models. The short prediction time of CNN indicated that CNN had the potential for real-time detection. The prediction maps obtained by the CNN models indicated that the color information and geographical origins could affect the detection performance. The overall results demonstrated the promising potential for detecting subtle bruises on winter jujubes using pixel-wise spectra extracted from the hyperspectral images at the two spectral ranges with the deep learning method. The results in this study would help to develop an online winter jujube bruises detection system in the future.

Abstract:Early bruises in apples, especially those occurred within 30 min, resemble healthy tissue and are difficult to be distinguished with the naked eye, making conventional techniques such as manual and machine vision sorting difficult. Near-infrared (NIR) camera has strongly ability to show bruises as bruised tissue is more sensitive to NIR light. In this paper, the NIR camera imaging technology combined with deep learning method to detect early bruise in apple was proposed. A NIR camera in the spectral range of 900–2350 nm was used to acquire early apple bruise images. After datasets of bruise images with different impact forces and different bruise duration time were established, three target detection algorithms, Faster R-CNN, Yolov3-Tiny and Yolov5s, were used to extract apple bruise area for damage detection. The results showed that the accuracy of three algorithms for early bruised and no bruised apples were all more than 99%, the accuracy of no bruised, mildly bruised and severely bruised apples were all more than 96%, and the shortest detection speed of a single image was 6.8 ms. This study shows that this method has high detection accuracy and fast recognition speed. It can be effectively applied to early bruise detection in apples, and is expected to realize real-time online detection.

Abstract:Bruise damage on apples is one of the most key internal quality factors, which needs to be detected in postharvest quality sorting processes. However, detection of bruises is always a challenging issue. This study proposes a useful strategy for detection of early bruises on apples with different peel colors based on Vis-NIR hyperspectral/multispectral reflectance imaging combining with watershed segmentation algorithm, which has never been tried in the past. Three spectral regions, namely visible and near-infrared (Vis-NIR) (450–685 nm and 750–1000 nm), visible (Vis) (450–685 nm), and near-infrared (NIR) (750–1000 nm), were selected for principal component analysis (PCA) to identify the optimal region and principal component (PC) score image, respectively. The third PC score image (PC3) obtained by using PCA of the NIR spectra was found to be the most useful for detection of bruise damage on apples. Three important wavelength images at 786, 915, and 995 nm were further identified from data dimension reduction by weighting coefficient analysis of all sub-images of PC3 score images. Finally, bruise detection based on both the second PC score image obtained from multispectral PCA and the proposed improved watershed segmentation algorithm was performed to classify all 210 samples with three kinds of peel color including green peel, middle-color peel (green-red), and red peel (dark red); a 99.5% overall detection accuracy (99.2% for 120 bruised samples and 100% for 90 sound samples) was obtained, indicating feasibility of this study. The finding is significant because the study of apples with different surface colors was closer to the actual production of fruit sorting.

Abstract:Spectroscopy data are useful for modelling biological systems such as predicting quality parameters of horticultural products. However, using the wide spectrum of wavelengths is not practical in a production setting. Such data are of high dimensional nature and they tend to result in complex models that are not easily understood. Furthermore, collinearity between different wavelengths dictates that some of the data variables are redundant and may even contribute noise. The use of variable selection methods is one efficient way to obtain an optimal model, andthis was the aim of this work. Taking advantage of a non-contact spectrometer, near infrared spectral data in the range of 800–2500 nm were used to classify bruise damage in three apple cultivars, namely 'Golden Delicious', 'Granny Smith' and 'Royal Gala'. Six prominent machine learning classification algorithms were employed, and two variable selection methods were used to determine the most relevant wavelengths for the problem of distinguishing between bruised and non-bruised fruit. The selected wavelengths clustered around 900 nm, 1300 nm, 1500 nm and 1900 nm. The best results were achieved using linear regression and support vector machine based on up to 40 wavelengths: these methods reached precision values in the range of 0.79–0.86, which were all comparable (within error bars) to a classifier based on the entire range of frequencies. The results also provided an open-source based framework that is useful towards the development of multi-spectral applications such as rapid grading of apples based on mechanical damage, and it can also be emulated and applied for other types of defects on fresh produce.

Abstract:Bruise damage is a very commonly occurring defect in apple fruit which facilitates disease occurrence and spread, leads to fruit deterioration and can greatly contribute to postharvest loss. The detection of bruises at their earliest stage of development can be advantageous for screening purposes. An experiment to induce soft bruises in Golden Delicious apples was conducted by applying impact energy at different levels, which allowed to investigate the detectability of bruises at their latent stage. The existence of bruises that were rather invisible to the naked eye and to a digital camera was proven by reconstruction of hyperspectral images of bruised apples, based on effective wavelengths and data dimensionality reduced hyperspectrograms. Machine learning classifiers, namely ensemble subspace discriminant (ESD), k-nearest neighbors (KNN), support vector machine (SVM) and linear discriminant analysis (LDA) were used to build models for detecting bruises at their latent stage, to study the influence of time after bruise occurrence on detection performance and to model quantitative aspects of bruises (severity), spanning from latent to visible bruises. Over all classifiers, detection models had a higher performance than quantitative ones. Given its highest speed in prediction and high classification performance, SVM was rated most recommendable for detection tasks. However, ESD models had the highest classification accuracy in quantitative (>85%) models and were found to be relatively better suited for such a multiple category classification problem than the rest.

Abstract:Apple fruits can be easily damaged, and bruises occur on peels during harvest, transportation and storage, which could decrease fruit quality. This paper proposed an apple bruise grading method based on hyperspectral imaging (HSI). The spectral information of sound apples (Yantai Fuji 8) was first captured using a hyperspectral reflectance imaging device (386-1016 nm). These apples were then mechanically damaged by the same impact forces, and the bruised regions were exposed to room temperature for at most 120 min. The spectral data of the bruised apples at four different exposure times (30 min, 60 min, 90 min and 120 min) were obtained. The spectral data were preprocessed using Procrustes analysis (PA) to enable a more diverse distribution of the spectra among different patterns. To both accurately maintain the spectral information of different patterns and reduce the dimensions of the spectra, piecewise nonlinear curve fitting (PWCF) was presented using the least squares algorithm, where the resultant fitting coefficients from different spectral intervals were catenated into a low-dimension feature descriptor. The feature descriptors were then fed to an error-correction output coding-based support vector machine (ECOC-SVM) to grade the bruised apples. To further evaluate the performance of the presented PWCF, conventional algorithms, including the successive projections algorithm (SPA), genetic algorithm (GA), principal component analysis (PCA) and kernel principal component analysis (KPCA), were introduced for comparison. Experimental results showed that the proposed method obtained the best grading accuracy (97.33%) compared to the other methods.

Abstract:A method was proposed to detect early bruises on apples using near‐infrared (NIR) camera imaging combined with adaptive threshold segmentation algorithm. The results show that the proposed algorithm has an accuracy of 95.56% for the detection of sound apples and an F1‐score of 94.70% for the detection of early bruised samples. Apples are highly susceptible to bruising during picking, packing, and transportation, and early detection of apple bruises allows timely screening and treatment to reduce food safety risks. However, early bruises on apples, especially bruises of 30 min or less, with similar appearance to sound tissue, making manual sorting difficult. To address this problem, a near‐infrared (NIR) camera imaging technology combined with adaptive threshold segmentation algorithm for early apple bruise detection is proposed in this article. First, a NIR camera imaging system is built to acquire full‐band images of fruit face, fruit stem face and calyx face of sound apples and apples with single bruise and multiple bruises at 30 min of occurrence. Then, an adaptive threshold segmentation algorithm is proposed and an image processing algorithm, which includes high‐pass filtering, feature extraction, adaptive threshold segmentation and Hough circle detection, is developed and applied to full‐band images in response to the interference of apple stem and calyx on early bruising detection in this article. The results show that the proposed algorithm has an accuracy of 95.56% for the detection of sound apple samples and an F1‐score of 94.70% for the detection of early bruised samples, which is better than the commonly used image segmentation algorithms such as Otsu and fixed thresholding. This study shows that the combination of NIR camera imaging and the adaptive threshold segmentation algorithm proposed in this article can effectively detect early bruises on apples, providing a new idea for rapid and nondestructive detection of agricultural product quality. Practical applications Detecting early bruises on apples can achieve effective monitoring and control of apple supply chain, and guarantee the quality and safety of agricultural products. Most studies are based on conventional machine vision with RGB camera or hyperspectral imaging technology, while conventional machine vision based on RGB camera is difficult to detect apple early bruises that are not visible to the naked eye, and hyperspectral imaging has a large amount of data and redundant image data among wavelengths. Compared with previous studies, apple early bruise detection method proposed in this article combining NIR camera imaging technology and adaptive threshold segmentation algorithm can avoid the interference of bright spots, fruit stem and calyx on bruise segmentation while capturing a single channel image, providing a new method for accurate and rapid detection of early bruises on apples.

Abstract:This study demonstrates a method to select wavelength-specific spectral resolutions to optimize a line-scan hyperspectral imaging method for its intended use, which in this case was visible/near-infrared imaging-based multiple-waveband detection of apple bruises. Many earlier studies have explored important aspects of developing apple bruise detection systems, such as key wavelengths and image processing algorithms. Despite the endeavors of many, development of a real-time bruise detection system is not yet a simple task. To overcome these problems, this study investigated selection of optimal wavelength-specific spectral resolutions for detecting bruises on apples by using hyperspectral line-scan imaging with the Random Track function for non-contiguous partial readout, with two experimental parts. The first part identified key-wavelengths and the optimal number of key-wavelengths to use for detecting low-, medium-, and high-impact bruises on apples. These parameters were determined by principal component analysis (PCA) and sequential forward selection (SFS) with four classification methods. The second part determined the optimal spectral resolution for each of the key-wavelengths by selecting and evaluating 21 combinations of exposure time and key-wavelength bandwidths, and then selecting the best combination based on the bruise detection accuracies achieved by each classification method. Each of the four classification methods was found to have a different optimized resolution for high accuracy bruise detection, and the optimized resolutions also allowed for use of shorter exposure times. The results of this work can be used to help develop multispectral imaging systems that provide rapid, cost-effective post-harvest processing to identify bruised apples on commercial processing lines.

Abstract:The visible/near-infrared (Vis/NIR) spectroscopy technique has been widely used for the online detection of soluble solids content (SSC) in apples. However, external factors such as sample size and detection position can cause spectral distortion, resulting in a decline in detection accuracy. In this study, we aimed to develop a more robust prediction model that can resist the impact of sample size and detection position on the model. Firstly, we collected and analyzed the transmission spectra of apple samples under different sizes and detection positions using a self-designed Vis/NIR spectroscopy online acquisition device. It was found that the effect of fruit size and detection position on Vis/NIR spectra was due to optical path difference. Thus, a diameter correction method was utilized to uniformly correct the obtained absorbance spectra. The performance of local models achieved better results after correction. And then, global models with various preprocessing methods were developed. To further improve the model performance, changeable size moving window (CSMW) and competitive adaptive reweighted sampling (CARS) were utilized to select the effective wavelengths. After that, one dimensional-convolutional neural network (1D-CNN) model was constructed, which outperformed the other models without any preprocessing and optimization methods, and the values of RCal2, RMSEC, RPre2, and RMSEP are 0.953, 0.254 %, 0.900, and 0.371 %, respectively. In this study, conventional PLSR modelling methods and deep 1D-CNN method were compared under the influence of the two external factors, and the result showed that 1D-CNN can serve as a more convenient alternative for apple online SSC determination, which could significantly reduce the complexity of the Vis/NIR spectroscopy modeling process.

Abstract:The visible/near-infrared (Vis/NIR) spectroscopy technique is effective for fruit quality detection. The distinct spectral features can reflect the internal composition of fruits, while variations in external orientation may induce interference. Considering both external and internal factors, we improved the discrimination accuracy of pest-infested crabapples by compensating for variations in orientation and amplifying differences in spectral morphological features (SMFs). Firstly, spectral intensity variations caused by orientations and morphological differences caused by pest infestation were analyzed. Based on these differences, the global model was established to mitigate the external orientation influence. Subsequently, SMFs, derived from spectral peaks and troughs, were employed to amplify spectral features. Finally, with the supplementation using 1st deviation, SMFs improved the discrimination performance of the partial least square–linear discriminant analysis (PLS-LDA) model for pest infestation, yielding results of sensitivity, specificity, and accuracy as 95.14

Abstract:Determination and classification of the bruise degree for cherry can improve consumer satisfaction with cherry quality and enhance the industry's competiveness and profitability. In this study, visible and near infrared (Vis-NIR) reflection spectroscopy was used for identifying bruise degree of cherry in 350-2500 nm. Sampling spectral data were extracted from normal, slight and severe bruise samples. Principal component analysis (PCA) was implemented to determine the first few principal components (PCs) for cluster analysis among samples. Optimal wavelengths were selected by loadings of PCs from PCA and successive projection algorithm (SPA) method, respectively. Afterwards, these optimal wavelengths were empolyed to establish the classification models as inputs of least square-support vector machine (LS-SVM). Better performance for qualitative discrimination of the bruise degree for cherry was emerged in LS-SVM model based on five optimal wavelengths (603, 633, 679, 1083, and 1803 nm) selected directly by SPA, which showed acceptable results with the classification accuracy of 93.3%. Confusion matrix illustrated misclassification generally occurred in normal and slight bruise samples. Furthermore, the latent relation between spectral property of cherries in varying bruise degree and its firmness and soluble solids content (SSC) was analyzed. The result showed both colour, firmness and SSC were consistent with the Vis-NIR reflectance of cherries. Overall, this study revealed that Vis-NIR reflection spectroscopy integrated with multivariate analysis can be used as a rapid, intact method to determine the bruise degree of cherry, laying a foundation for cherry sorting and postharvest quality control.
Dynamic Nondestructive Detection Models of Apple Quality in Critical Harvest Period Based on Near-Infrared Spectroscopy and Intelligent Algorithms

Abstract:Apples are usually bagged during the growing process, which can effectively improve the quality. Establishing an in situ nondestructive testing model for in-tree apples is very important for fruit companies in selecting raw apple materials for valuation. Low-maturity apples and high-maturity apples were acquired separately by a handheld tester for the internal quality assessment of apples developed by our group, and the effects of the two maturity levels on the soluble solids content (SSC) detection of apples were compared. Four feature selection algorithms, like ant colony optimization (ACO), were used to reduce the spectral complexity and improve the apple SSC detection accuracy. The comparison showed that the diffuse reflectance spectra of high-maturity apples better reflected the internal SSC information of the apples. The diffuse reflectance spectra of the high-maturity apples combined with the ACO algorithm achieved the best results for SSC prediction, with a prediction correlation coefficient (Rp) of 0.88, a root mean square error of prediction (RMSEP) of 0.5678 °Brix, and a residual prediction deviation (RPD) value of 2.466. Additionally, the fruit maturity was predicted using PLS-LDA based on color data, achieveing accuracies of 99.03% and 99.35% for low- and high-maturity fruits, respectively. These results suggest that in-tree apple in situ detection has great potential to enable improved robustness and accuracy in modeling apple quality.
Detection of Early Stage Bruise in Apples Using Optical Property Mapping

Abstract:Apple bruises, which are mainly caused by external forces during picking, transportation and marketing, could cause significant economic losses in postharvest storage. Considering the short time window (1-2 h) between bruises occurring and apples are stored, there needs a technique that can identify the invisible early stage bruises (defined as within 1-2 h after occurring), which cannot be completed by the conventional uniform imaging techniques. This study proposed and validated a new means, i.e., optical property mapping, for detecting apple bruises at the early stage. SFDI system was firstly validated, with the results showing that accuracy for measuring mu(a) and mu(s)' were within 8.71 % and 4.93 %, respectively. Optical property mappings of non-bruised and early stage bruised apples were extracted by the methods of three-phase coupled with curve fitting (TP-CF), and single snapshot coupled with look-up table (SS-LUT). The extracted mu(s)' mappings were capable of detecting early stage bruises, and the TP-CF approach resulted into better performance than SS-LUT, but at the expense of lowering efficiency about 14,000 times. Denoising algorithms significantly enhanced the visual effect of bruise detection by minimizing the influence of apple peel spots. The approach proposed in this study is promising for detecting early stage bruising for apple industry.
Detection storage time of mild bruise’s yellow peaches using the combined hyperspectral imaging and machine learning method

Abstract:Abstract To deduce the process of bruise and reduce the number of bruised fruits from the source, the storage time of yellow peaches after bruise should be identified. In order to distinguish the different storage times of mild bruise’s yellow peaches more effectively than current detection methods, the combined hyperspectral imaging and machine learning method was proposed. Firstly, the sample bruise region spectrum was extracted as spectral features, and then, the hyperspectral images were processed by Principal Component Analysis (PCA), and eight single-wavelength images were selected according to the weight coefficient curve of PC1 images, and the gray values of the selected images were calculated as image features. Finally, in order to find the optimal discriminative model, random forest (RF), support vector machine (SVM), and extreme gradient boosting (XGBoost) models were built based on spectral features, image features, and spectral features combined with image features, respectively. The results show that the XGBoost models based on spectral features, image features, and spectral features combined with image features are the optimal models with the overall accuracy of 77.50%, 87.50% and 90.00%, respectively. To simplify the model, Competitive Adaptive Reweighted Sampling (CARS) algorithm was used to screen the wavelength of the normalized spectral data, and then they were fused with the image feature data again and the XGBoost model with an overall model accuracy of 95.00% was built. To sum up, the combined hyperspectral imaging and machine learning method can be used to distinguish the different storage times (2 h, 8 h, 24 h and 48 h) of mild bruise’s yellow peaches effectively. It provides a certain theoretical basis for hyperspectral imaging technology in fruit bruise detection.

The optimal input variables were obtained by comparing the performance of the partial least squares-discriminant analysis, artificial neural network, and one-dimensional convolutional neural network (1D-CNN) models based on the spectral data and the fusion data of spectral and textural features. The optimal variable was the fusion data that could improve the model performance (from 92.68% to 96.10%). The above-mentioned three classifiers were used to establish models based on fusion data for two different dataset sizes consisting of large datasets (LD) (820) and small datasets (SD) (200) to explore the influence of dataset size on model performance. As the sample size increased, the 1D-CNN had good robustness with a classification rate of 94.00% for SD and 96.10% for LD in the prediction sets for all samples. The classification rate of prediction sets for 0 h after bruising increased from 90.00% to 92.68%, and from 80.00% to 90.24% in the class of 24 h after bruising. The findings provided a new approach to building a large spectral library and developing an online classification and detection system, thereby providing new ideas for the development of grading systems for Lingwu long jujube.

Abstract:It is crucial for early detection of mechanical damage to improve the quality of commodity fruits. To address the issues related to the fuzzy damage characteristics of early fruit damage and the challenges associated with accurately identifying the damaged locations, this study proposed a method of detecting the initial damage of apples based on passive thermal imaging technology. Passive thermal imaging technology was used to collect the thermal images of the apples 0–60 min after damage, once every 2 min, for a total of 5 times. The temperature difference data of the damaged part and the undamaged part were extracted from the temperature data, and the evolution law of the temperature difference with time was analyzed. Then, it was transformed into the area under the curve distribution data of the area under the curve, so as to generate the corresponding gray image for realizing the detection of the initial damage of apples. The results showed that the detection precision of the undamaged apples was 98.3
Wavelength Selection for Detection of Slight Bruises on Pears Based on Hyperspectral Imaging

Abstract:Hyperspectral imaging technology was employed to detect slight bruises on Korla pears. The spectral data of 60 bruised samples and 60 normal samples were collected by a hyperspectral imaging system. To select the characteristic wavelengths for detection, several chemometrics methods were used on the raw spectra. Firstly, principal component analysis (PCA) was conducted on the spectra ranging from 420 to 1000 nm of all samples. Considering that the reliability of the first two PCs was more than 90%, five characteristic wavelengths (472, 544, 655, 688 and 967 nm) were selected by the loading plot of PC1 and PC2. Then, each of the wavelength variables was considered as an independent classifier for bruised/normal classification, and all classifiers were evaluated by the receiver operating characteristic (ROC) analysis. Two wavelengths (472 and 967 nm) with the highest values under the curve (0.992 and 0.980) were finally selected for modeling. The classifying model was built by partial least squares discriminant analysis (PLS-DA) and the bruised/normal classification accuracy of the modeling set (45 damaged samples and 45 normal samples) and prediction set (15 damaged samples and 15 normal samples) was 98.9% and 100%, respectively, which is similar to that of the PLS-DA model based on the whole spectral range. The result shows that it is feasible to select characteristic wavelengths for the detection of slight bruises on pears by the methods combining the PCA and ROC analysis. This study can lay a foundation for the development of an online detection system for slight bruise detection on pears.

Abstract:Non-destructive detection of fruits bruises in order to enhance products' quality and safety wiil greatly benefit the consumer and the fruit industry as a whole. Bruised Kiwifruit with skin undamaged is difficult to be recognized by naked eyes in a short time result in undetected and fruit rot at last The feasibility of using hyperspectral imaging technique was investigated for the detection of bruises on kiwifruit in this study. The images of kiwifruit samples were obtained at different time (1 hour and 3 days) after bruised based on hyperspectral images at the wavelength range from 380 to 1030 nm. Mean and standard deviation value of spectra were extracted from hyperspectral images. PC A was used for data dimensionality reduction and selecting the effective wavelengths. Three effective wavelengths (708, 729, 770 nm) were selected to realize hyperspectral imaging tests. Support vector machine (SVM) was used to establish bruise identification model. Compared with the detection results of bruising for 1 h and 3 days, they indicated that the bruised areas were successfully distinguished from the sound parts. It means that hyperspectral imaging technique could be used for the detection of bruised fruits with skin undamaged.
Combining transfer learning and hyperspectral imaging to identify bruises of pears across different bruise types

Abstract:Mechanical bruise is one of the most crucial factors affecting the quality of pears, which has a huge influence on postharvest transportation, storage, and sale of pears. To rapidly detect early bruises of pears across different bruise types, hyperspectral imaging technology coupled with transfer learning methods was performed in this study. Two transfer learning methods, that is, transfer component analysis (TCA) and manifold embedded distribution alignment (MEDA), were applied for two tasks (impact bruise → crush bruise, crush bruise → impact bruise). Supporting vector machine (SVM) was set as a baseline to conduct analysis and comparison of the transferability of the models. The result showed that, for task 1 (impact bruise → crush bruise), MEDA and TCA-SVM model achieved a classification accuracy of 93.33% and 91.11% in target domain, individually. For task 2 (crush bruise →impact bruise), MEDA and TCA-SVM model achieved an accuracy of 88.89% and 85.19% in target domain, respectively. Both the two models improved the accuracy compared with SVM models (84.44% for task 1; 77.04% for task 2). Overall, the results indicated that transfer learning approaches could perform pear bruise detection across different bruise types. Hyperspectral imaging in combination with transfer learning methods is a promising possibility for the efficient and cost-saving field detection of fruit bruises among different bruise types. PRACTICAL APPLICATION: The production and export of pears are faced with problems of mechanical damage due to vibration, collision, impact, and other factors, which cause chemical changes in color, odor, and taste. Sometimes the bruise was too slight to be ignored which would infect with other fruits in the future. In this study, we used hyperspectral imaging combined with transfer learning method could detect these slight bruises caused by different factors. Distinguishing different types of damage can provide a reference for quick judgment of the process causing damage and take prompt measures to reduce economic losses.

Abstract:Bruises resulting from mechanical collisions during picking, packing, and transportation lead to a decline in the quality of blueberry fruits. Therefore, performing a quantitative evaluation in the early stages of fruit bruising is essential for achieving the quality classification of blueberries. The primary aim of this study was to precisely quantify internal damage in blueberries by employing a combination of band ratios and an improved multi-threshold Coati Optimization Algorithm (MT-COA) method. Initially, hyperspectral reflectance images (ranging from 950 to 1650 nm) of both sound and bruised blueberries were acquired 30 min after damage. Secondly, to reduce data dimensionality, data processing utilized principal component analysis and band ratio techniques, and a comparative analysis of these two methods was performed. Subsequently, the band ratio images R 1112.6/1470.9 were segmented into three classes, encompassing bruised tissue, sound tissue, and background, using global threshold, Otsu method, watershed segmentation algorithm (WSA), MT-COA method, and improved MT-COA method. Finally, the intersection over Union (IoU) metric was employed to assess the segmentation effectiveness. The bruise ratio index (BRI) was calculated to assess the damage rate of the fruit. The results indicate that by utilizing hyperspectral reflectance imaging in conjunction with band ratio and improved MT-COA method, sound and bruised areas can be segmented from the fruit as early as 30 min after damage. The average IoU accuracy is 70.1%. The model shows the potential to quantify early bruises of blueberries during the postharvest period.
