Abstract:Understanding the spatially varying effect mechanism of intermodal connection on metro ridership helps policymakers develop differentiated interventions to promote metro usage, especially for megacities with multiple city sub-centers and ring roads. Using multiple datasets in Shanghai, this study combines Light Gradient Boosting Machine (LightGBM) with Shapley additive explanations (SHAP) to explore these effects with the consideration of the built environment and metro network topology. Results show that the collective impacts of intermodal connection are positive, not only within the main city but also alongside the main commuting corridors, while negative effects occur in the peripheral area. Specifically, bike sharing trips increase metro ridership within the inner ring of the city, while bus services lower metro usage at stations alongside the elevated ring roads. Parking facilities enable metro usage at city sub-centers, and the small pedestrian catchment area increases metro riders alongside the main commuting corridors. Empirical findings help policymakers understand the effect mechanism of intermodal connection for stations in different regions and prioritize customized planning strategies.

Abstract:The metro is the backbone of the transport system in many cities. Analyzing the built-environment correlates of metro ridership is crucial for transit-oriented development (TOD) planning and practice. Although numerous studies went along this line, they have rarely considered the non-linearity and temporal heterogeneity in the association of metro ridership with the built environment. After collecting transit smart card data, geo-data, and mobile phone signal data, this study adopts the random forest model to reveal the complex association of hourly metro ridership in November 2019 in Chengdu (China) with the built environment in three times of day (i.e., morning peak, noon off-peak, and evening peak hours). Notably, the contribution of several variables, such as the number of station entrances/overpasses and parking density, has rarely been considered in the literature. The results confirm the presence of non-linearity and temporal heterogeneity in the aforementioned association. Access to the city center and population density are strong predictors of metro ridership in the morning peak hour, whereas employment density, enterprise density, and road density are strong predictors in the evening peak hour. There are great differences in the correlates of metro ridership in different periods. Critical TOD planning parameters are also identified from the partial dependence plots obtained from random forest modeling.

Abstract:Travel demand analysis at the planning stage is important for metro system development. In practice, travel demand can be affected by various factors. This paper focuses on investigating the factors influencing Taipei metro ridership at station level over varying time periods. Ordinary Least Square (OLS) multiple regression models with backward stepwise feature selection are employed to identify the influencing factors, including land use, social economic, accessibility, network structure information, etc. Network structure factors are creatively quantified based on complex network theory to accurately measure the related information. To enhance goodness-of-fit, the dummy variable distinguishing transportation hub is incorporated in the modeling. The main findings in this paper are three-fold: First, there is no distinct difference between influencing factors of boarding and those of alighting; Second, ridership is significantly associated with the number of nearby shopping malls, distance to city center, days since opening, nearby bus stations and dummy variable for transportation hub; Finally, the ridership on weekdays is mainly affected by commuting activities, while the ridership on weekends is driven by commercial access.

Abstract:Metro systems provide a mass and sustainable mobility option for urban populations. Drawing on the ridership data in 2019 released by the Shanghai Municipal Transportation Commission, we examine the spatially varying effects of station-level factors measured with different metro-station catchments (MSCs) on the daily and hourly ridership through multiscale geographically weighted regression (MGWR) models. The results indicate that independent variables measured with relatively small and non-overlapping MSCs can better explain the spatial variations in metro ridership. Regarding the important determinants, land use intensity (LUI) demonstrates positive effects diminishing from the core to the peripheral areas, transfer lines (TL) also exhibits positive effects that decrease from southwest to northeast. The effects of road density (RD) and building density (BD) are negative in central urban areas but positive in suburbs, which is the opposite of bus lines (BL). Additionally, the explanatory variables have significantly different ranges of influence, and the range of influence for a single variable also varies across models that use ridership at different times (e.g., weekdays vs. non-weekdays, the morning/evening peak vs. non-peak hours) as dependent variables. This study expands the knowledge of the spatial variations in the relationship between metro ridership and the geographical determinants. The findings can provide empirical evidence and implications for urban planners in formulating context-specific policies to improve the usage of metro systems.

Abstract:The metro station ridership features are associated significantly with the built environment factors of the pedestrian catchment area surrounding metro stations. The existing studies have focused on the impact on total ridership at metro stations, ignoring the impact on varying patterns of metro station ridership. Therefore, the reasonable identification of metro station categories and built environment factors affecting the varying patterns of ridership in different categories of stations is very important for metro construction. In this study, we developed a data-driven framework to examine the relationship between varying patterns of metro station ridership and built environment factors in these areas. By leveraging smart card data, we extracted the dynamic characteristics of ridership and utilized hierarchical clustering and K-means clustering to identify diverse patterns of metro station ridership, and we finally identified six main ridership patterns. We then developed a newly built environment measurement framework and adopted multinomial logistic regression analysis to explore the association between ridership patterns and built environment factors. (1) The clustering analysis results revealed that six station types were classified based on varying patterns of passenger flow, representing distinct functional characteristics. (2) The regression analysis indicated that diversity, density, and location factors were significantly associated with most station function types, while destination accessibility was only positively associated with employment-oriented type stations, and centrality was only associated with employment-oriented hybrid type station. The research results could inform the spatial planning and design around metro stations and the planning and design of metro systems. The built environment of pedestrian catchment areas surrounding metro stations can be enhanced through rational land use planning and the appropriate allocation of urban infrastructure and public service facilities.

Abstract:Opening new lines will bring the structural change of passenger flow characteristics in network operation of Urban Rail Transit. Based on the smart card data from Shenzhen Metro, temporal-spatial characteristics was discussed comprehensively from different statistics dimensions and analysis angles. At the same time, passenger flow in 28 transfer stations was analyzed by clustering algorithm and the land use nature was attained. Consequently, the passenger flow law in Shenzhen Metro will be understood better combined with visualization. Especially, when facing the risk of large passenger flow, targeted measures can be taken in advance to improve the safety and resilience of Shenzhen Metro.

Abstract:Transit-oriented development (TOD) planning strategy has been widely implemented worldwide to formulate dense, mixed-use built environment in the past three decades. The primary goal of TOD is to promote public transit usage including both transit mode share and ridership. Research supports that built environment characteristics around metro stations affect residents' travel behaviors and metro usage. However, the evidence remains inconsistent in different urban contexts. Furthermore, research focusing on mode share such as commuting trips at station level is still scarce. In this study, a rule-based model was used to identify commuting trips using metro service with smart card data (SCD), covering more than 90 percent of all metro passengers in Wuhan, China. Built environment characteristics around metro stations were measured with a 3Ds framework (density, diversity, and design). Results suggest that population density is negatively associated with metro commuting mode share, while street intersection shows a positive relationship. Office-oriented urban function and street intersection are positively correlated with metro ridership. Hence, exploring the fine-grained relationship of metro usage and built environment factors around transit stations in different urban and social contexts warrants further research attention.

Abstract:The most common mass transit modes in metropolitan cities include buses, subways, and taxicabs, each of which contribute to an interconnected complex network that delivers urban dwellers to their destinations. Understanding the intertwined usages of these three transit modes at different places and time allows for better sensing of urban mobility and the built environment. In this article, we leverage a comprehensive data collection of bus, metro, and taxicab ridership from Shenzhen, China to unveil the spatio-temporal interplay between different mass transit modes. To achieve this goal, we develop a novel spectral clustering framework that imposes spatio-temporal similarities between mass transit mode usage in urban space and differentiates urban spaces associated with distinct ridership patterns of mass transit modes. Five resulting categories of urban spaces are identified and interpreted with auxiliary knowledge of the city's metro network and land-use functionality. In general, different categorized urban spaces are associated with different accessibility levels (such as high-, medium-, and low-ranked) and different urban functionalities (such as residential, commercial, leisure-dominant, and home-work balanced). The results indicate that different mass transit modes cooperate or compete based on demographic and socioeconomic attributes of the underlying urban environments. Our proposed analytical framework provides a novel and effective way to explore the mass transit system and the functional heterogeneity in cities. It demonstrates great potential for assisting policymakers and municipal managers in optimizing public transportation facility allocation and city-wide daily commuting distribution.
Unraveling the relative contribution of TOD structural factors to metro ridership: A novel localized modeling approach with implications on spatial planning

Abstract:TOD (transit-oriented development) has gradually earned the reputation as a promising spatial planning strategy to encourage public transit usage. Many cities across the world, especially those in the global south, have established TOD projects around metro stations. From this standpoint, the paramount question of how TOD is conductive to metro ridership is at the heart of scholarly discourse. Theoretically, the territorial organization of a TOD comprises three structural factors –node (metro station), place (surrounding land use) and their feedback. An accurate judgement of the TOD-metro ridership relationship would not be achieved if we neglected any of the three structural factors forming the TOD architecture. However, the three TOD structural factors have not frequently been considered simultaneously in prior literature. A gap remains regarding the relative contribution of TOD structural factors to metro ridership across time and space. This paper aims to address this unresolved issue using a case study of the Hangzhou metropolitan area in China. As the dependent variable, metro ridership is measured using one week of smart card records, with the three TOD structural factors as explanatory variables and sociodemographic factors as control variables, described by a set of indicators. A novel localized modeling approach using variance decomposition of geographically temporally weighted regression is demonstrated to quantify the spatially and temporally varying relative contribution of TOD structural factors. The results show that both similarities and discrepancies were identified compared to earlier studies. Most importantly, new knowledge was gained, particularly that ‘metro station’ factors contribute the most to metro ridership, followed by the feedback factor, ‘surrounding land use’ factors and sociodemographic factors both on workdays and nonworkdays. Furthermore, our analysis highlights that the relative contribution of TOD structural factors presents noticeable spatial heterogeneities across metro station areas both on workdays and nonworkdays but exhibits only obvious temporal heterogeneity on nonworkdays. Finally, TOD clusters are generated based on the relative contribution of TOD structural factors with implications for spatial planning. This study is believed to open the door for framing locally representative strategies of TOD to stimulate the use of public transit.

Abstract:Accurately understanding the travel demand of urban rail transit (URT) systems is crucial for effective operational management. Despite the recognition that the diversity in human activity patterns results in different travel demands, few studies have thoroughly investigated the heterogeneity among passengers and its impact on URT ridership. This study utilizes smart card data collected from the Beijing Subway to categorize passengers into four groups: tourist passengers, flexible commuters, regular commuters, and life‐oriented passengers, based on their spatiotemporal travel patterns. Furthermore, a Multiscale Geographically Weighted Regression (MGWR) model is employed to examine the relationship between station‐level ridership of URT and its determinants, including the built environment and station properties, for each passenger group. The results indicate that the influence of these determinants on station‐level ridership varies across passenger groups and spatial scales. For instance, regular commuters exhibit lower sensitivity to accessibility on workdays, whereas those unfamiliar with the URT network are more concerned about the bus accessibility in pedestrian‐ or bicycle‐unfriendly areas. Notably, for tourist and life‐oriented passengers, the stations significantly affected by population density are concentrated in areas with a higher proportion of elderly individuals. Conversely, for flexible and regular commuters, these stations are predominantly situated in areas associated with internet technology and scientific research. These findings are valuable for policymakers in designing strategies tailored to different passenger groups to balance trip demand and capacity, thereby improving URT services and promoting a sustainable urban environment.

Abstract:A reasonable land use development around subway stations can balance the utilization rates of the subway system during peak and off-peak hours, thereby enhancing its service levels and operational efficiency. Analyzing the temporal distribution patterns of passenger flow and their influencing factors is crucial for determining the optimum ratio of each land use type surrounding metro stations. Thus, this paper employs principal component analysis (PCA) at first to investigate the temporal distribution of metro ridership, and identify their main patterns and factor loadings. Then, using geographically weighted regression, the study examines the spatial dependencies between the main component proportions and influencing factors, focusing on Xi'an subway stations. The results indicate that the temporal distribution of passenger flow can be decomposed into three principal components: the first representing commuting characteristics, and the second and third representing regulating functions. The overall distribution is a composite of these components in varying proportions. Residential and educational land uses primarily drive morning and evening peak flows, with residential land use in the city center and peripheral areas having a more pronounced effect compared to transitional areas. Conversely, commercial & office, healthcare, and recreational & park land mitigate peak flows and increase off-peak flows. External hub enhances passenger flow throughout the day, while industrial land use has negligible impact.
Spatially Varying Impacts of Built Environment on Transfer Ridership of Metro and Bus Systems

Abstract:Public transport, especially bus and metro, are fundamental elements of sustainable transport systems. However, a dearth of research has been devoted to exploring the correlation between the built environment and the intermodal transfer modes that link bus and metro. To address this research gap, this study aims to explore the relationship between the built environment and transfer ridership by examining transfer ridership across different modes. First, this study uses Automatic Fare Collection (AFC) and Automatic Vehicle Location (AVL) data collected in the city of Chengdu to identify the ridership of Metro-to-Bus (M-B) and Bus-to-Metro (B-M) transfer passengers using dynamic transfer time thresholds. A multi-scale geographically weighted regression model (MGWR) is employed to examine the impact of the built environment on M-B and B-M transfer modes and their scale effects. The findings demonstrate that the MGWR model is effective in capturing the spatial heterogeneity and scale effects of the interrelationships between different built environment factors in the M-B and B-M modes. Furthermore, the impact of different built environment factors on transfer ridership varies. In particular, the number of bus stops and lines have a more pronounced positive effect on promoting transfer ridership, while the density of non-motorway lanes has a significant negative effect. This research provides valuable insights for public transportation management and supports the seamless integration of bus and metro systems to optimize transfer services.

Abstract:Many global high-density cities have embraced transit-oriented development (TOD) strategies around metro stations in a strong push toward promoting transit trips. However, the general TOD principles must be adapted to a variety of local features. Thus, conducting a baseline study that deciphers the locality-specific differences and similarities in the influence of TOD on metro ridership is of paramount importance. Using the case of Shanghai in China, this paper demonstrated a novel approach to unveiling the locality-specific influence of TOD on metro ridership that integrated the node-functionality-place model with interpretable machine learning. By exploring a wide range of explanatory variables, we discovered that the relative importance of TOD structural factors (e.g., node, place and functionality) and neighborhood sociodemographics as well as their interactions presented great spatial and temporal heterogeneity for boarding and alighting on weekdays and weekends. Among the TOD structural factors, functionality was of the highest importance, and a greater contribution was observed within the central districts during peak hours. Regarding the interactions among the TOD structural factors, the interaction between node and functionality presented the highest relative importance, followed by that between place between functionality and that between node and place. Additionally, neighborhood sociodemographics also accounted for a noticeable contribution, especially in the outskirts. Based on the locality-specific estimations, the affinity propagation clustering algorithm was further used to cluster the TODs into difference groups as nuanced representations of the TOD-metro ridership relationships. The findings refreshed the knowledge base concerning the spatiotemporal heterogeneity in the nonlinear influence of TOD on metro ridership and provided new insights into spatial planning. The proposed approach showed high computational feasibility with strong theoretical underpinnings and thus offered broad potential applications into other high-density cities worldwide.

Abstract:Although many studies investigate the association between land use and station ridership, few examine their nonlinear and moderating relationships. Using metro smartcard data in Shenzhen, we develop a gradient boosting decision trees model to estimate the relative importance of land use variables and their threshold and moderating effects on ridership. We found that station betweenness centrality has the largest predictive power, followed by employment density and commercial floor area ratio (FAR). Results suggest that employment density, commercial FAR, and aggregate residential density should be set at 40,000 jobs/km2, 2, and 77,000 persons/km2, respectively, for maximizing ridership. The moderating effects show that population densification is more effective at terminal stations, whereas the policies intensifying nonresidential use work better at middle stations. These findings help planners prioritize land use strategies, identify effective ranges of land use metrics, and propose land use guidelines adaptive to the network position of stations.

Abstract:A plethora of studies have investigated the nonlinear correlation between the built environment and metro ridership. However, the spatiotemporal heterogeneity of this relationship from the perspective of ridership segmentation has received little attention. To address this gap, this study capitalizes on data collected from Wuhan, China. We employ a sophisticated amalgamation of quantile regression models and machine learning methods to construct direct ridership models (DRMs) for different ridership segments (low, medium, and high) and distinct temporal intervals (weekdays and weekends). The primary objective of these models is to scrutinize the salient factors that influence metro ridership within the context of spatiotemporal heterogeneity, including nonlinear relationships and threshold effects of the built environment. The research findings reveal pronounced differences in the significant influencing factors of the built environment on metro ridership across various ridership segments and temporal periods. Additionally, conspicuous spatiotemporal heterogeneity is discerned in the nonlinear relationships and threshold effects between the two. Consequently, considering the spatiotemporal heterogeneity inherent in metro stations, targeted policy optimization measures fostering the sustainable development of transit-oriented development (TOD) strategies are essential.

Abstract:Rail transit plays a crucial role in improving urban sustainability and livability. In many Chinese cities, the planning of rail transit routes and stations is focused on facilitating new developments rather than revitalizing existing built-up areas. This approach reflects the local governments' expectations of substantial growth to reshape the urban structure. However, existing research on transit-oriented development (TOD) rarely explores the spatial interactions between individual transit stations and investigates how they can be integrated to achieve synergistic effects and balanced development. This study proposes that rail transit systems impact urban structure through two "forces": the provision of additional and reliable carrying capacity and the reduction of travel time between locations. Metro passenger flow is used as a proxy for these forces, and community detection techniques are employed to identify the actual and optimal spatial clusters in Wuhan, China. The results reveal that the planned sub-centers align reasonably well with the optimal spatial clusters in terms of spatial configuration. However, the actual spatial clusters tend to have longer internal travel times compared to the optimal clusters. Further exploration suggests the need for equalizing land use density within planned spatial clusters served by the metro system. Additionally, promoting concentrated, differentiated, and mixed functional arrangements in metro station areas with low passenger flows within the planned clusters could be beneficial. This paper presents a new framework for investigating urban spatial clusters influenced by a metro system.

Abstract:Identifying the determinants of metro ridership is essential for metro planning and passenger flow management. However, few studies to date have empirically examined how accessibility affects metro ridership and even fewer have emphasized the non-linear impacts from a spatiotemporal perspective. This study demarcates station areas via the network-distance method and precisely quantifies the accessibility of metro stations both internally and externally. This is combined with a gradient boosting regression trees (GBRT) model and a Shapley additive explanations (SHAP) model to understand the non-linear impacts of accessibility on metro ridership from a spatiotemporal perspective. The results show that accessibility indicators collectively contribute more than 60% of the predictive power for metro ridership at different times and the external accessibility has a greater impact on metro ridership than internal accessibility. Some indicators, such as the shortest path and population density show threshold effects on metro ridership. More importantly, the results demonstrate significant spatial heterogeneity in the effects of accessibility indicators on metro ridership and geographic trends generally from urban to suburban areas. The findings are expected to help planning departments and transit agencies improve the coordinated development of metro systems.

Abstract:Understanding the effects of intermodal connectivity on metro ridership is essential for policymakers and urban planners to facilitate metro usage. Although many studies have examined the associations between the built environment and metro ridership, few investigated the effects of first/last-mile facilities. Using smartcard data and multi-source big data in Shanghai, this study applies LightGBM approach to estimate the nonlinear, threshold and synergistic effects of last-mile facilities on metro ridership, while controlling for built environment characteristics and metro network attributes. Results show that last-mile facility variables collectively contribute 43.57% for predicting metro ridership. Nonlinear associations illustrate that most last-mile facilities need to reach certain thresholds to maximize metro ridership. Furthermore, bus supply and built environment factors may moderate the effects of last-mile facilities on metro ridership in a multiplex way. These research findings help urban planners identify effective ranges of different last-mile facilities and prioritize intermodal connectivity strategies in planning practice.

Abstract:The relationship between built environment and metro (underground railway) ridership has been well discussed in the literature. However, few studies focus on the metro ridership uncertainty and its temporal association with the built environment, that is the time-dependent effect of built environment on metro ridership uncertainty. To fill this gap, this study investigates the spatio-temporal patterns of metro ridership uncertainty using data collected in Beijing. Multivariate analysis models are developed to establish statistical relations between metro ridership uncertainty and built environment for different time periods (day of the week and time of the day) for analyzing the temporal variations of the built environment impacts. Results show that time-dependent effects significantly exist, with hourly variations in the relationship more evident than daily variations. Stations with added employment and residential buildings would generate additional metro demand during weekdays, while stations with added service and commercial establishments are during weekends. The findings of this study will help us understand how the built environment affects metro ridership uncertainty in different time periods and develop effective policies.
