Abstract:Fast and robust traffic sign recognition is very important but difficult for the safety driving assist systems. This study addresses the fast and robust traffic sign recognition to enhance safety driving. We first adopt the typical Hough transform methods to implement coarse-grained locating of the candidate regions (shapes of rectangle, triangle and circle, etc.) of the traffic signs; and then propose a ring of RIBP (Rotation Invariant Binary Pattern) histograms based feature in Gaussian space to reduce the traffic sign detection time and achieve the robustness on traffic sign detection in terms of scale, rotation, and illumination; Finally, the learning based techniques are used to reduce the feature dimension and implement the classification, which greatly reduce the processing time of traffic sign recognition. Experiments on the GTSRB dataset show that this work achieves 98.62% recognition accuracy and average 0.005 second per image recognition time, which exhibit the comparable recognition accuracy and higher recognition speed comparing to the state-of-the-art works.
An Efficient Framework for Detection and Recognition of Numerical Traffic Signs

Abstract:Due to the variety of categories and uneven distribution of available samples, automatic traffic sign detection and recognition is still a challenging task. For those categories with less training data, existing deep learning methods cannot achieve desirable performance, and the overall detection effect is not satisfactory as well. In this letter, we fully explore the relationship between different traffic signs with digital characters and transform the category objects into multi-level classes to alleviate the uneven distribution of samples. We design a lightweight two-stage object detection framework with high real-time performance. The first stage network is proposed to obtain the category groups of traffic signs, and then we construct another object detection network to identify the digital characters of the detected traffic signs. To make the prediction in the first stage more accurate, we put forward a boxes fusion algorithm in the post-processing process and a refine module to improve the recognition performance. Experimental results show that our approach possesses significantly improved performance compared with the latest object detection networks and other traffic sign detectors. Even some traffic signs that only exist in testset can also be recognized accurately by our method.

Abstract:Traffic sign detection is one of the key components in autonomous driving. Advanced autonomous vehicles armed with high quality sensors capture high definition images for further analysis. Detecting traffic signs, moving vehicles, and lanes is important for localization and decision making. Traffic signs, especially those that are far from the camera, are small, and so are challenging to traditional object detection methods. In this work, in order to reduce computational cost and improve detection performance, we split the large input images into small blocks and then recognize traffic signs in the blocks using another detection module. Therefore, this paper proposes a three-stage traffic sign detector, which connects a BlockNet with an RPN–RCNN detection network. BlockNet, which is composed of a set of CNN layers, is capable of performing block-level foreground detection, making inferences in less than 1 ms. Then, the RPN–RCNN two-stage detector is used to identify traffic sign objects in each block; it is trained on a derived dataset named TT100KPatch. Experiments show that our framework can achieve both state-of-the-art accuracy and recall; its fastest detection speed is 102 fps.

Abstract:In the lighting conditions such as hazing, raining, and weak lighting condition, the accuracy of traffic sign recognition is not very high due to missed detection or incorrect positioning. In this article, we propose a traffic sign recognition (TSR) algorithm based on Faster R-CNN and YOLOv5. The road signs were detected from the driver’s point of view and the view was assisted by satellite images. First, we conduct image preprocessing by using guided image filtering for the input image to remove noises. Second, the processed image is input into the proposed networks for model training and testing. Three datasets are employed to verify the effectiveness of the proposed method finally. The outcomes of the traffic sign recognition are promising.
Traffic Sign Detection by ROI Extraction and Histogram Features-Based Recognition

Abstract:We present a traffic sign detection model consisting of two modules. The first module is for ROI (region of interest) extraction. By supervised learning, it transforms the color images to gray images such that the characteristic colors for the traffic signs are more distinguishable in the gray images. It follows shape template matching, where a set of templates for each target category of signs are designed. After that, a set of ROIs are generated. The second module is for recognition. It validates if an ROI belongs to a target category of traffic signs by supervised learning. Local shape and color features are extracted. The supervised learning methods used in the model are SVMs. The overall model is applied on the GTSDB benchmark and achieves 100%, 98.85% and 92.00% AUC (area under the precision-recall curve) for Prohibitory, Danger and Mandatory signs, respectively. The testing speed is 0.4-1.0 second per image on a mainstream PC, which demonstrates the great potential of the proposed model in real-time applications.

Abstract:With the rapid development of the autonomous driving industry, there is increasing research on related perception tasks. However, research on road surface traffic sign detection tasks is still limited. There are two main challenges to this task. First, when the target object's pixel ratio is small, the detection accuracy often decreases. Second, the existing publicly available road surface traffic sign datasets have limited image data. To address these issues, this paper proposes a new instance segmentation network, RTS R-CNN, for road surface traffic sign detection tasks based on Mask R-CNN. The network can accurately perceive road surface traffic signs and provide important information for the autonomous driving decision-making system. Specifically, CSPDarkNet53_ECA is proposed in the feature extraction stage to enhance the performance of deep convolutional networks by increasing inter-channel interactions. Second, to improve the network's detection accuracy for small target objects, GR-PAFPN is proposed in the feature fusion part, which uses a residual feature enhancement module (RFA) and atrous spatial pyramid pooling (ASPP) to optimize PAFPN and introduces a balanced feature pyramid module (BFP) to handle the imbalanced feature information at different resolutions. Finally, data augmentation is used to generate more data and prevent overfitting in specific scenarios. The proposed method has been tested on the open-source dataset Ceymo, achieving a Macro F1-score of 87.56%, which is 2.3% higher than the baseline method, while the inference speed reaches 23.5 FPS.

Abstract:Considering the problem of automatic traffic sign detection and recognition in stereo images captured under motion conditions, a new algorithm for traffic sign detection and recognition based on features and probabilistic neural networks (PNN) is proposed in this paper. Firstly, global statistical color features of left image are computed based on statistics theory. Then for red, yellow and blue traffic signs, left image is segmented to three binary images by self-adaptive color segmentation method. Secondly, gray-value projection and shape analysis are used to confirm traffic sign regions in left image. Then stereo image matching is used to locate the homonymy traffic signs in right image. Thirdly, self-adaptive image segmentation is used to extract binary inner core shapes of detected traffic signs. One-dimensional feature vectors of inner core shapes are computed by central projection transformation. Fourthly, these vectors are input to the trained probabilistic neural networks for traffic sign recognition. Lastly, recognition results in left image are compared with recognition results in right image. If results in stereo images are identical, these results are confirmed as final recognition results. The new algorithm is applied to 220 real images of natural scenes taken by the vehicle-borne mobile photogrammetry system in Nanjing at different time. Experimental results show a detection and recognition rate of over 92%. So the algorithm is not only simple, but also reliable and high-speed on real traffic sign detection and recognition. Furthermore, it can obtain geometrical information of traffic signs at the same time of recognizing their types.

Abstract:Recent years have witnessed significant advancements in machine perception, particularly in the context of self-driving vehicles. The accurate detection and interpretation of road signs by these vehicles are crucial for enhancing safety, intelligence, and efficiency on the roads. Consequently, there is a growing body of research dedicated to improving traffic sign recognition technologies, a key component of intelligent transportation systems. Annual statistics highlight numerous accidents attributable to factors such as excessive speed, variable lighting conditions, and the misinterpretation of traffic signs. In response to these challenges, a novel approach for the rapid and reliable recognition of traffic signs by moving vehicles has been developed. This approach leverages a custom dataset encompassing twelve object categories and seven subcategories, reflective of road sign diversities encountered in India. A specialized algorithm, TrafficSignNet, was devised to specifically identify signs related to speed, turning, zones, and bumps. This algorithm was trained on a comprehensive dataset comprising 4,962 images, with its performance evaluated using 705 images from real traffic scenarios. The evaluation demonstrates that the model achieves remarkable accuracy across various lighting conditions, processing up to 12 frames per second. This processing rate is compatible with the high-definition standards of contemporary vehicle cameras, which is 1280 × 720 pixels. The model's effectiveness is quantified through accuracy, precision, recall, and F1 score, with respective values of 0.985, 0.978, 0.964, and 0.971, showcasing its potential to significantly contribute to the advancement of smart transportation systems.

Abstract:Traffic sign detection is an important part of environment-aware technology and has great potential in the field of intelligent transportation. In recent years, deep learning has been widely used in the field of traffic sign detection, achieving excellent performance. Due to the complex traffic environment, recognizing and detecting traffic signs is still a challenging project. In this paper, a model with global feature extraction capabilities and a multi-branch lightweight detection head is proposed to increase the detection accuracy of small traffic signs. First, a global feature extraction module is proposed to enhance the ability of extracting features and capturing the correlation within the features through self-attention mechanism. Second, a new, lightweight parallel decoupled detection head is proposed to suppress redundant features and separate the output of the regression task from the classification task. Finally, we employ a series of data enhancements to enrich the context of the dataset and improve the robustness of the network. We conducted a large number of experiments to verify the effectiveness of the proposed algorithm. The accuracy of the proposed algorithm is 86.3%, the recall is 82.1%, the mAP@0.5 is 86.5% and the mAP@0.5:0.95 is 65.6% in TT100K dataset, while the number of frames transmitted per second is stable at 73, which meets the requirement of real-time detection.

Abstract:Traffic sign recognition with high accuracy and real-time is an important part of the intelligent transportation system. In this article, based on large-scale traffic signs and the inherent conflict between location regression and classification of traffic signs, we propose a novel and flexible two-stage approach. It combines a lightweight superclass detector with a refinement classifier. The main contributions lie in three aspects: (1) We use locations and sizes of signs as prior knowledge to establish a probability distribution model. It can significantly decrease the search range of signs and improve the processing speed, as well as reducing false detection. (2) We propose a high-performance lightweight superclass detector. We introduce the Inception and Channel Attention, by generating multi-scale receptive fields and adaptively adjusting channel features. It alleviates the large scale variance challenge of objects and the interference of background information. Meanwhile, we present a merging Batch Normalization and multi-scale testing method to further improve detection performance. (3) We propose a refinement classifier based on similarity measure learning for the subclass classification. It increases the precision of discriminating similar subclasses and also improves the extensibility of our approach. Our two-stage approach is simple and effective, whose paradigm is different from others. Experiments on the Tsinghua-Tencent 100K dataset demonstrate the performance of our approach. Compared with the state-of-the-art methods, our method achieves competitive performance (92.16% mAP) with a lightweight detector ( ). The processing time is per frame, of which the speed is increased by 3 times compared with existing methods.

Abstract:The detection and recognition of traffic signs is an important topic in intelligent transportation systems. The automatic detection and recognition of traffic signs during driving is the basis for realizing the unmanned driving. Therefore, the work on the detection and recognition of traffic signs has a potential value and application prospect. In the traditional detection and recognition methods, they often detect and recognize traffic signs image by image. In this case, only the information of the current image is used, and the relationship between the image sequences is not considered. To end this issue, we propose a novel model that can use the relationship in multi-images to detect and recognize traffic signs in a driving video sequence quickly and accurately. The model proposed in this paper is a fusion model based on YOLO-V3 and VGG19 network. Finally, we test this proposed model on a public dataset and compare it to the baseline method, and results show that this proposed model achieves accuracy over 90% and outperforms the baseline method for all types of traffic signs in different conditions. Thus, we can conclude this proposed model is efficient and accurate.

Abstract:Environment awareness technology is one of the most critical technologies for autonomous vehicles, and traffic sign recognition is an important branch of environment awareness system, which has important research significance for ensuring traffic safety. To solve the problems of easy omission and inaccurate positioning for traffic sign detection under complex illumination conditions, there are two main innovations in this paper: firstly, an adaptive image enhancement algorithm was proposed to improve the image quality under complex illumination conditions; Secondly, a novel and lightweight attention block named Feature difference (FD) model was proposed to detect and recognize traffic signs. Unlike state-of-the-art attention models, which utilizes the difference between two feature maps to generate the attention mask. In this work, the single-stage target detection algorithm SSD was selected as the basic network, the backbone network was set as ResNet and VGG respectively and FD module was added. A large number of experiments were carried out to evaluate the optimization effect of FD module. The following conclusions can be drawn: image enhancement algorithms can provide better image samples; The FD model can be integrated into most of CNNs just by adding some shortcut connections, which does not introduce any additional parameters and layers; The average detection accuracy with FD module is 1.80% higher and the average recall rate was 1.51% higher than that without FD module, which has no great influence on the running speed. The FD module has better enhancement effect for dark image detection; The detection accuracy of the FD module is slightly better than other attention modules including BAM, CBAM and SE; The FD model can be used to evaluate the effect of the convolutional operation on features, which could help to find convolutional layers that have little effect on the accuracy of recognition for the network pruning.

Traffic Sign Detection Based on the Improved YOLOv5

Abstract:With the advancement of intelligent driving technology, researchers are paying more and more attention to the identification of traffic signs. Although a detection method of traffic signs based on color or shape can achieve recognition of large categories of signs such as prohibitions and warnings, the recognition categories are few, and the accuracy is not high. A traffic sign detection algorithm based on color or shape is small in computation and good in real-time, but the color features are greatly affected by light and weather. For the questions raised above, this paper puts forward an improved YOLOv5 method. The method uses the SIoU loss function to take the place of the loss function in the YOLOv5 model, which optimizes the training model, and the convolutional block attention model (CBAM) is fused with the CSP1_3 model in YOLOv5 to form a new CSP1_3CBAM model, which enhances YOLOv5’s feature extraction ability and improves the accuracy regarding traffic signs. In addition, the ACONC is introduced as the activation function of YOLOv5, which promotes YOLOv5’s generalization ability through adaptive selection of activation by linear–nonlinear switching factors. The research results on the TT100k dataset show that the improved YOLOv5 precision rate increased from 73.2% to 81.9%, an increase of 8.7%; the recall rate increased from 74.2% to 77.2%, an increase of 3.0%; and the mAP increased from 75.7% to 81.9%, an increase of 6.2%. The FPS also increased from 26.88 to 30.42 frames per second. The same training was carried out on the GTSDB traffic sign dataset, and the mAP increased from 90.2% to 92.5%, which indicates that the algorithm has good generalization ability.

Abstract:Traffic signs are indispensable fixtures in modern transportation activities, which are installed along the roadside or over the pathway to provide important prompt messages. The timely emergences, complete visibilities, and definite signals of traffic signs matter significantly to direct the driving behaviors and ensure the convenience and security of the transportation activities. Moreover, the efficient and accurate recognition of traffic signs can also provide decisive evidences to a variety of intelligent transportation systems. Nevertheless, the unignorable presence issues of traffic signs caused by vision factors, such as small sizes, dimness, deformations, and occlusions, impact essentially on the high-quality recognition of traffic signs. This paper develops a novel attentive semi-anchoring guided high-resolution network, named SignHRNet, for street-level traffic signs recognition purpose. First, stacked with a high-resolution network boosted by a dual-attention module as the feature extractor, the SignHRNet can exploit informative channel features and task-oriented spatial features to generate multiscale strong feature semantics for instance-level predictions. Second, designed with a semi-anchoring guided detection strategy assisted by instance-aware feature alignment, the SignHRNet can achieve highly-efficient sign type categorization and highly-accurate sign location determination. The proposed SignHRNet is intensively evaluated on three large-size datasets towards traffic signs recognition. Quantitative verifications demonstrate a competitive accuracy with an average mAP, mAP50, and mAP75 of 72.85%, 96.48%, and 85.31%, respectively, in processing traffic signs of varying self-conditions under diverse scenarios. Ablative and comparative analyses also confirmed the practical reliability and performance superiority of the SignHRNet in traffic signs recognition applications.

Abstract:We have developed a series of effective online data augmentation strategies for the traffic sign recognition dataset, which are able to improve the model performance without any extra computational overhead during the prediction process; To enhance the feature extraction ability of the backbone almost without extra model complexity, we have developed an efficient CSAM module placed at the beginning of the backbone, with the help of the hybrid channel and spatial attention mechanism and the residual bottleneck structure; To make better use of the features extracted by the backbone, we combined the channel attention module CAM with the feature pyramid network (FPN) and path aggregation network (PAN) structure for a multi‐scale attention feature fusion detection head. Currently, traffic sign recognition techniques have been brought into the assistive driving of automobiles. However, small traffic sign recognition in real scenes is still a challenging task due to the class imbalance issue and the size limit of the traffic signs. To address the above issues, a feature‐enhanced hybrid attention network is proposed based on YOLOv5s for a small, fast, and accurate traffic sign detector. First, a series of online data augmentation strategies are designed in the preprocessing module for the model training. Second, the hybrid channel and spatial attention module CSAM are integrated into the backbone for a better feature extraction ability. Third, the channel attention module CAM is used in the detection head for a more efficient feature fusion ability. To validate the approach, extensive experiments are conducted based on the Tsinghua‐Tencent 100K dataset. It is found that the novel method achieves state‐of‐the‐art performance with only negligible increases in the model parameter and computational overhead. Specifically, the mAP@0.5 , parameters, and FLOPs are 85.8%, 7.13 M, and 16.1 G, respectively.

Traffic sign detection based on multi-scale feature extraction and cascade feature fusion

Abstract:Existing algorithms have difficulty in solving the two tasks of localization and classification simultaneously when performing traffic sign detection on realistic images of complex traffic scenes. In order to solve the above problems, a new road traffic sign dataset is created, and based on the YOLOv4 algorithm, for the complexity of realistic traffic scene images and the large variation in the size of traffic signs in the images, the multi-scale feature extraction module, cascade feature fusion module and attention mechanism module are designed to improve the algorithm's ability to locate and classify traffic signs simultaneously. Experimental results on the newly created dataset show that the improved algorithm achieves a mean average precision of 84.44%, which is higher than several major CNN-based object detection algorithms for the same type of task.

Abstract:With the progress of science and technology and the development of social economy, intelligent transportation came into being. Traffic signs recognition, as an important part of intelligent traffic, has been widely researched. The problem of traffic signs identification is complicated and changeable, and it is easy to be affected by the factors such as weather, illumination, occlusion and shooting angle. Convolutional neural network has a strong robustness for image translation, scaling, rotation and other deformation. Based on this, we use an improved convolutional neural network to recognize traffic signs to meet the needs of practical applications. This method can automatically extract the features of the image by convolution and pool processing, and then make classification of them, so as to realize the recognition of traffic signs. The correct rate of the algorithm which is used in this paper is 98.13%, by processing the experiment on the GTSRB data set.

Abstract:Traffic sign detection and recognition (TSDR) plays an important role in the fields for assistant driving, autonomous vehicle and so on. However, due to the complexity of real driving scene and variety of traffic signs, many challenging problems occurred, such as inaccurate color segmentation and time consumption of recognition algorithm based on deep learning. This paper describes an approach for efficiently detection and recognizing in real world scenarios. First of all, a traffic sign region of interest extraction algorithm based on multi-color space is proposed, the fusion future of HSV and RGB color space can obtain better color segmentation for the SVM classifier. Next a novel multi-scale two-stage lightweight network (MSTSN) is investigated, which adopts a coarse-to-fine strategy to improve recognition accuracy. Specially, the candidate Region of Interests (ROIs) are fed into a binary classification layer and only positive ones are further classified with multi-class classification network. The deeply separable convolution, residual structure and feature enhancement module is the bottleneck of MSTSN, which obtains more discriminative features and meets requirement for real-time performance. The experimental results successfully demonstrate effectiveness of our method.

Abstract:Real-time traffic sign detection and recognition are essential and challenging tasks for intelligent vehicle. The previous works mainly focus on detecting and recognizing traffic sign based on images captured by onboard camera. Visual features of traffic sign such as color, shape, and appearance, however, are often sensitive to illumination condition, angle of view, etc. Except for camera, LIDAR also provides important and alternative features of traffic sign. The fusion of complementary data acquired from both sensors can improve the robustness of the algorithm, especially when data from either of them are of low quality. For this reason, we propose a new traffic sign detection and recognition algorithm based on the fusion of camera and LIDAR data. Specifically, position prior, color, laser reflectivity, and 3D geometric features are integrated to detect traffic sign in a 3D space. In most of previous works, different colors of traffic signs are individually handled in a specific color space, which generally results in the use of many thresholds or multiple classifiers. In this paper, we use combined color spaces (CCS) such that traffic sign colors can be entirely treated as one class. For traffic sign recognition, in order to improve the robustness to any viewpoint variation, regions of interest (ROIs), which suffer from perspective deformation, are rectified first by fusing LIDAR and camera data. Then the histogram of oriented gradient (HOG) feature and linear support vector machines (SVMs) are used to classify traffic signs. Finally, extensive experimental results in challenging conditions show that our algorithm is real-time and robust.
