Abstract:This article targets at unlocking the potentials of a class of prominent generative artificial intelligence (GAI) method, namely diffusion model (DM), for mobile communications. First, a DM-driven communication architecture is proposed, which introduces two key paradigms, i.e., conditional DM and DM-driven deep reinforcement learning (DRL), for wireless data generation and communication management, respectively. Then, we discuss the key advantages of DM-driven communication paradigms. To elaborate further, we explore DM-driven channel generation mechanisms for channel estimation, extrapolation, and feedback in multiple-input multiple-output (MIMO) systems. We showcase the numerical performance of conditional DM using the accurate DeepMIMO channel datasets, revealing its superiority in generating high-fidelity channels and mitigating unforeseen distribution shifts in sophisticated scenes. Furthermore, several DM-driven communication management designs are conceived, which is promising to deal with imperfect channels and task-oriented communications. To inspire future research developments, we highlight the potential applications and open research challenges of DM-driven communications. What problem does this paper attempt to address?
The problem this paper attempts to address is: how to use Diffusion Models (DM) to generate high-quality data in mobile communications and perform dynamic resource management to improve the performance of communication systems. Specifically, the paper explores the following aspects: 1. **Wireless Data Generation**: Using Conditional Diffusion Models (Conditional DM) to generate high-fidelity Channel State Information (CSI) and other wireless signals for tasks such as channel estimation, channel extrapolation, and channel feedback. This helps to overcome the limitations of traditional methods in complex scenarios, such as channel distribution shifts and noise interference. 2. **Dynamic Resource Management**: Achieving efficient resource allocation through DM-driven Reinforcement Learning (DM-driven RL), including beam training, tracking and management, power/bandwidth/time allocation, user association, and UAV/vehicle planning. This helps to address imperfect Channel State Information (CSI) and task-oriented communication requirements. 3. **Future Applications and Challenges**: Discussing the potential applications of Diffusion Models in UAV-assisted networks and Integrated Sensing and Communication Systems (ISAC), and pointing out the open challenges faced in practical deployment. The main contributions of the paper include: - Proposing a communication architecture based on Diffusion Models, covering both Conditional Diffusion Models and DM-driven Reinforcement Learning paradigms. - Discussing efficient methods for generating MIMO channels and demonstrating the superior performance of Conditional Diffusion Models in channel estimation using the DeepMIMO dataset. - Designing various DM-driven resource management schemes to address imperfect Channel State Information and task-oriented communication requirements. - Outlining the application prospects and challenges of Diffusion Models in future mobile communication systems.
