Abstract:Magnetic resonance imaging (MRI) is renowned for its exceptional soft tissue contrast and high spatial resolution, making it a pivotal tool in medical imaging. The integration of deep learning algorithms offers significant potential for optimizing MRI reconstruction processes. Despite the growing body of research in this area, a comprehensive survey of optimization-based deep learning models tailored for MRI reconstruction has yet to be conducted. This review addresses this gap by presenting a thorough examination of the latest optimization-based algorithms in deep learning specifically designed for MRI reconstruction. The goal of this paper is to provide researchers with a detailed understanding of these advancements, facilitating further innovation and application within the MRI community.

What problem does this paper attempt to address?
This paper primarily discusses the application of optimization algorithms based on deep learning methods in Magnetic Resonance Imaging (MRI) reconstruction. Although there have been numerous studies applying deep learning to MRI reconstruction, there is still insufficient work on comprehensive investigations of deep learning models with optimization algorithms. Therefore, this paper aims to fill this gap by conducting a comprehensive review and explanation of how the latest optimization algorithms, combined with deep learning, improve image quality and accelerate the MRI scanning process. MRI has become an important tool in medical imaging due to its high soft tissue contrast and excellent spatial resolution. However, its long imaging time limits patient throughput. To reduce scanning time while maintaining image quality, researchers have developed techniques such as compressed sensing and parallel imaging. With the rise of deep learning, especially the application of Convolutional Neural Networks (CNNs), high-quality images can be reconstructed from undersampled k-space data, improving diagnostic efficiency. The paper provides a detailed introduction to several network unfolding algorithms based on gradient descent, Alternating Direction Method of Multipliers (ADMM), Primal-dual Hybrid Gradient (PDHG) algorithm, and diffusion models, and discusses their specific applications in MRI reconstruction. For example, the Variational Network utilizes pre-computed sensitivity maps for multi-channel MRI reconstruction, while ADMM-Net optimizes neural network operations through a cell structure. Additionally, the paper mentions the use of learned parameterized operations to simulate traditional approximation operators in diffusion models, such as Denoising Diffusion Probabilistic Models (DDPMs), which exhibit strong robustness in handling distribution shifts. In conclusion, this paper summarizes the integration of optimization algorithms and deep learning in MRI reconstruction, providing researchers with a valuable resource for gaining in-depth understanding of these advancements, thereby facilitating further innovation and applications in this field.
