Are Graph Neural Networks Optimal Approximation Algorithms?

Abstract:In this work we design graph neural network architectures that capture optimal approximation algorithms for a large class of combinatorial optimization problems, using powerful algorithmic tools from semidefinite programming (SDP). Concretely, we prove that polynomial-sized message-passing algorithms can represent the most powerful polynomial time algorithms for Max Constraint Satisfaction Problems assuming the Unique Games Conjecture. We leverage this result to construct efficient graph neural network architectures, OptGNN, that obtain high-quality approximate solutions on landmark combinatorial optimization problems such as Max-Cut, Min-Vertex-Cover, and Max-3-SAT. Our approach achieves strong empirical results across a wide range of real-world and synthetic datasets against solvers and neural baselines. Finally, we take advantage of OptGNN's ability to capture convex relaxations to design an algorithm for producing bounds on the optimal solution from the learned embeddings of OptGNN.

Abstract:In this article we prove that the minimum-degree greedy algorithm, with adversarial tie-breaking, is a (2/3) -approximation for the Maximum Independent Set problem on interval graphs. We show that this is tight, even on unit interval graphs of maximum degree 3. We show that on chordal graphs, the greedy algorithm is a (1/2) -approximation and that this is again tight. These results contrast with the known (tight) approximation ratio of 3Δ+2 of the greedy algorithm for general graphs of maximum degree Δ .

Abstract:Win proved a well-known result that the graph G of connectivity κ ( G ) with α ( G ) ≤ κ ( G ) + k − 1 ( k ≥ 2) has a spanning k -ended tree, i.e., a spanning tree with at most k leaves. In this paper, the authors extended the Win theorem in case when κ ( G ) = 1 to the following: Let G be a simple connected graph of order large enough such that α ( G ) ≤ k + 1 ( k ≥ 3) and such that the number of maximum independent sets of cardinality k + 1 is at most n − 2 k − 2. Then G has a spanning k -ended tree.

Abstract:We propose a polynomial time approximation algorithm for a novel maximum edge coloring problem which arises from wireless mesh networks [Ashish Raniwala, Tzi-cker Chiueh, Architecture and algorithms for an IEEE 802.11-based multi-channel wireless mesh network, in: INFOCOM 2005, pp. 2223-2234; Ashish Raniwala, Kartik Gopalan, Tzi-cker Chiueh, Centralized channel assignment and routing algorithms for multi-channel wireless mesh networks, Mobile Comput. Commun. Rev. 8 (2) (2004) 50-65]. The problem is to color all the edges in a graph with maximum number of colors under the following q-Constraint: for every vertex in the graph, all the edges incident to it are colored with no more than q (q@?Z,q=2) colors. We show that the algorithm is a 2-approximation for the case q=2 and a (1+4q-23q^2-5q+2)-approximation for the case q2 respectively. The case q=2 is of great importance in practice. For complete graphs and trees, polynomial time accurate algorithms are found for them when q=2. The approximation algorithm gives a feasible solution to channel assignment in multi-channel wireless mesh networks.

Abstract:Let be a graph. For an edge , the closed neighbourhood of e , denoted by or , is the set . A vertex set is liar's vertex-edge dominating set of a graph if for every , and for every pair of distinct edges and , . This paper introduces the notion of liar's vertex-edge domination which arises naturally from some applications in communication networks. Given a graph G , the Minimum Liar's Vertex-Edge Domination Problem ( MinLVEDP ) asks to find a liar's vertex-edge dominating set of G of minimum cardinality. In this paper, we study this problem from an algorithmic point of view. We show that MinLVEDP can be solved in linear time for trees, whereas the decision version of this problem is NP-complete for general graphs, chordal graphs, and bipartite graphs. We further study approximation algorithms for this problem. We propose two approximation algorithms for MinLVEDP in general graphs and p -claw free graphs. On the negative side, we show that the MinLVEDP cannot be approximated within for any , unless . Finally, we prove that the MinLVEDP is APX-complete for bounded degree graphs and p -claw-free graphs for .

Abstract:We give a $(1.796+\epsilon)$-approximation for the minimum sum coloring problem on chordal graphs, improving over the previous 3.591-approximation by Gandhi et al. [2005]. To do so, we also design the first polynomial-time approximation scheme for the maximum $k$-colorable subgraph problem in chordal graphs.

Abstract:Makespan minimization on unrelated machines is a classic problem in approximation algorithms. No polynomial time (2 -- δ)-approximation algorithm is known for the problem for constant δ > 0. This is true even for certain special cases, most notably the restricted assignment problem where each job has the same load on any machine but can be assigned to one from a specified subset. Recently in a breakthrough result, Svensson [16] proved that the integrality gap of a certain configuration LP relaxation is upper bounded by 1.95 for the restricted assignment problem; however, the rounding algorithm is not known to run in polynomial time.In this paper we consider the (1, ε)-restricted assignment problem where each job is either heavy (pj = 1) or light (pj = ε), for some parameter ε > 0. Our main result is a (2 -- δ)-approximate polynomial time algorithm for the (1, ε)-restricted assignment problem for a fixed constant δ > 0. Even for this special case, the best polynomial-time approximation factor known so far is 2. We obtain this result by rounding the configuration LP relaxation for this problem. A simple reduction from vertex cover shows that this special case remains NP-hard to approximate to within a factor better than 7/6.
Generalising the maximum independent set algorithm via Boolean networks

Abstract:A simple greedy algorithm to find a maximal independent set (MIS) in a graph starts with the empty set and visits every vertex, adding it to the set if and only if none of its neighbours are already in the set. In this paper, we consider the generalisation of this MIS algorithm by letting it start with any set of vertices and we prove the hardness of many decision problems related to this generalisation. Our results are based on two main strategies. Firstly, we view the MIS algorithm as a sequential update of a Boolean network, which we refer to as the MIS network, according to a permutation of the vertex set. The set of fixed points of the MIS network corresponds to the set of MIS of the graph. Our generalisation then consists in starting from any configuration and following a sequential update given by a word of vertices. Secondly, we introduce the concept of a colony of a graph, that is a set of vertices that is dominated by an independent set. Deciding whether a set of vertices is a colony is NP-complete; decision problems related to the MIS algorithm will be reduced from the Colony problem. We first show that deciding whether a configuration can reach all maximal independent sets is coNP-complete. Second, we consider so-called fixing words, that allow to reach a MIS for any initial configuration, and fixing permutations, which we call permises; deciding whether a permutation is fixing is coNP-complete. Third, we show that deciding whether a graph has a permis is coNP-hard. Finally, we generalise the MIS algorithm to digraphs. The algorithm then uses the so-called kernel network, whose fixed points are the kernels of the digraph. Deciding whether the kernel network of a given digraph is fixable is coNP-hard, even for digraphs that have a kernel. Alternatively, we introduce two fixable Boolean networks whose sets of fixed points contain all kernels.

A polynomial-time $\text{OPT}^ε$-approximation algorithm for maximum independent set of connected subgraphs in a planar graph

Abstract:In the Maximum Independent Set of Objects problem, we are given an $n$-vertex planar graph $G$ and a family $\mathcal{D}$ of $N$ objects, where each object is a connected subgraph of $G$. The task is to find a subfamily $\mathcal{F} \subseteq \mathcal{D}$ of maximum cardinality that consists of pairwise disjoint objects. This problem is $\mathsf{NP}$-hard and is equivalent to the problem of finding the maximum number of pairwise disjoint polygons in a given family of polygons in the plane. As shown by Adamaszek et al. (J. ACM '19), the problem admits a \emph{quasi-polynomial time approximation scheme} (QPTAS): a $(1-\varepsilon)$-approximation algorithm whose running time is bounded by $2^{\mathrm{poly}(\log(N),1/\epsilon)} \cdot n^{\mathcal{O}(1)}$. Nevertheless, to the best of our knowledge, in the polynomial-time regime only the trivial $\mathcal{O}(N)$-approximation is known for the problem in full generality. In the restricted setting where the objects are pseudolines in the plane, Fox and Pach (SODA '11) gave an $N^{\varepsilon}$-approximation algorithm with running time $N^{2^{\tilde{\mathcal{O}}(1/\varepsilon)}}$, for any $\varepsilon>0$. In this work, we present an $\text{OPT}^{\varepsilon}$-approximation algorithm for the problem that runs in time $N^{\tilde{\mathcal{O}}(1/\varepsilon^2)} n^{\mathcal{O}(1)}$, for any $\varepsilon>0$, thus improving upon the result of Fox and Pach both in terms of generality and in terms of the running time. Our approach combines the methodology of Voronoi separators, introduced by Marx and Pilipczuk (TALG '22), with a new analysis of the approximation factor.

Abstract:The edge intersection graphs of paths on a grid (or EPG graphs) are graphs whose vertices can be represented as simple paths on a rectangular grid such that two vertices are adjacent if and only if the corresponding paths share at least one edge of the grid. We consider the case of single-bend paths, namely, the class known as B1-EPG graphs. The motivation for studying these graphs comes from the context of circuit layout problems. It is known that recognizing B1-EPG graphs is NP-complete, nevertheless, optimization problems when given a set of paths in the grid are of considerable practical interest.In this paper, we show that the coloring problem and the maximum independent set problem are both NP-complete for B1-EPG graphs, even when the EPG representation is given. We then provide efficient 4-approximation algorithms for both of these problems, assuming the EPG representation is given. We conclude by noting that the maximum clique problem can be optimally solved in polynomial time for B1-EPG graphs, even when the EPG representation is not given.

The problem is about coloring all the edges in a graph and finding a coloring solution which uses the maximum number of colors with the constraint, for every vertex in the graph, all the edges incident to it are colored with no more than q(q is an element of Z, q >= 2) colors. The case q = 2 is of great importance in practice. In this paper, we design approximation algorithms for cases q = 2 and q > 2 with approximation ratio 2.5 and 1 + 4q-2/3q(2) - 5q+2 respectively. The algorithms can give practically usable estimations on the upper bounds of the numbers of the channels used in wireless mesh networks.

Abstract:The minimum directed feedback vertex set problem consists in finding the minimum set of vertices that should be removed in order to make a directed graph acyclic. This is a well-known NP-hard optimization problem with applications in various fields, such as VLSI chip design, bioinformatics and transaction processing deadlock prevention and node-weighted network design. We show a constant factor approximation for the directed feedback vertex set problem in graphs of bounded genus.

In the Maximum Independent Set problem we are asked to find a set of pairwise nonadjacent vertices in a given graph with the maximum possible cardinality. In general graphs, this classical problem is known to be NP-hard and hard to approximate within a factor of [math] for any [math]. Due to this, investigating the complexity of Maximum Independent Set in various graph classes in hope of finding better tractability results is an active research direction. In [math]-free graphs, that is, graphs not containing a fixed graph [math] as an induced subgraph, the problem is known to remain NP-hard and APX-hard whenever [math] contains a cycle, a vertex of degree at least four, or two vertices of degree at least three in one connected component. For the remaining cases, where every component of [math] is a path or a subdivided claw, the complexity of Maximum Independent Set remains widely open, with only a handful of polynomial-time solvability results for small graphs [math] such as [math], [math], the claw, or the fork. We prove that for every such "possibly tractable" graph [math] there exists an algorithm that, given an [math]-free graph [math] and an accuracy parameter [math], finds an independent set in [math] of cardinality within a factor of [math] of the optimum in time exponential in a polynomial of [math] and [math]. Furthermore, an independent set of maximum size can be found in subexponential time [math]. That is, we show that for every graph [math] for which Maximum Independent Set is not known to be APX-hard and SUBEXP-hard in [math]-free graphs, the problem admits a quasi-polynomial time approximation scheme and a subexponential-time exact algorithm in this graph class. Our algorithms also work in the more general weighted setting, where the input graph is supplied with a weight function on vertices and we are maximizing the total weight of an independent set.

Abstract:For two independent Erdos-Renyi graphs G(n,p)$$ \mathbf{G}\left(n,p\right) $$, we study the maximal overlap (i.e., the number of common edges) of these two graphs over all possible vertex correspondence. We present a polynomial-time algorithm which finds a vertex correspondence whose overlap approximates the maximal overlap up to a multiplicative factor that is arbitrarily close to 1. As a by-product, we prove that the maximal overlap is asymptotically n2 alpha-1$$ \frac{n}{2\alpha -1} $$ for p=n-alpha$$ p={n}<^>{-\alpha } $$ with some constant alpha is an element of(1/2,1)$$ \alpha \in \left(1/2,1\right) $$.

Abstract:The problem of finding a minimum weight k-vertex connected spanning subgraph in a graph G=(V,E) is considered. For k≥2, this problem is known to be NP-hard. Combining properties of inclusion-minimal k-vertex connected graphs and of k-out-connected graphs (i.e., graphs which contain a vertex from which there exist k internally vertex-disjoint paths to every other vertex), we derive polynomial time algorithm for finding a (⌈k/2⌉+1)-connected subgraph with a weight at most twice the optimum to the original problem. In particular, we obtain a 2-approximation algorithm for the case k=3 of our problem. This improves the best previously known approximation ratio 3. The complexity of the algorithm is O(|V|3|E|)=O(|V|5).

Approximate Directed Minimum Degree Spanning Tree in Polynomial Time

Abstract:Given a directed graph $G$ on $n$ vertices with a special vertex $s$, the directed minimum degree spanning tree problem requires computing a incoming spanning tree rooted at $s$ whose maximum tree in-degree is the smallest among all such trees. The problem is known to be NP-hard, since it generalizes the Hamiltonian path problem. The best LP-based polynomial time algorithm can achieve an approximation of $\Delta^*+2$ [Bansal et al, 2009], where $\Delta^*$ denotes the optimal maximum tree in-degree. As for purely combinatorial algorithms (algorithms that do not use LP), the best approximation is $O(\Delta^*+\log n)$ [Krishnan and Raghavachari, 2001] but the running time is quasi-polynomial. In this paper, we focus on purely combinatorial algorithms and try to bridge the gap between LP-based approaches and purely combinatorial approaches. As a result, we propose a purely combinatorial polynomial time algorithm that also achieves an $O(\Delta^* + \log n)$ approximation. Then we improve this algorithm to obtain a $(1+\epsilon)\Delta^* + O(\frac{\log n}{\log\log n})$ for any constant $0<\epsilon<1$ approximation in polynomial time.
