Abstract:The radio environment map (REM), which can visualize the information of invisible electromagnetic spectrum, is vital for monitoring, management, and security of spectrum resources in cognitive radio (CR) networks. In view of a limited number of spectrum sensors and constrained sampling time, this paper presents a new three-dimensional (3D) REM construction scheme based on sparse Bayesian learning (SBL). Firstly, we construct a scenario-dependent channel dictionary matrix by considering the propagation characteristic of the interested scenario. To improve sampling efficiency, a maximum mutual information (MMI)-based optimization algorithm is developed for the layout of sampling sensors. Then, a maximum and minimum distance (MMD) clustering-based SBL algorithm is proposed to recover the spectrum data at the unsampled positions and construct the whole 3D REM. We finally use the simulation data of the campus scenario to construct the 3D REMs and compare the proposed method with the state-of-the-art. The recovery performance and the impact of different parameters on the constructed REMs are also analyzed. Numerical results show that the proposed scheme can reduce the required spectrum data and has higher accuracy under the low sampling rate.

Abstract:Database-driven Dynamic Spectrum Sharing (DSS) enhances active monitoring of spectrum usage, such that secondary users are allowed to opportunistically access licenced spectrum with the no-harmful-interference-to-primary-user constraint. A geo-location database administrator (DBA) maintains spectrum availability over its service region by periodically collecting and processing spatio-temporal spectrum data to construct Radio Environment Maps (REMs). To attract mobile users in the outsourced sensing tasks of spectrum measurements, crowdsourced spectrum sensing has great potential in REM construction. However, false measurements submitted by faulty/malicious users cannot be neglected. Constructing better REMs based on crowdsourced spectrum sensing remains an open challenge, especially considering privacy protection of mobile users. In this work, we introduce TAC-REM (Trust-aware Crowdsourced spectrum sensing for the resulting REM optimization), a novel differentially-private reverse auction mechanism. TAC-REM allows the DBA to iteratively select trustworthy spectrum measurements in the presence of false measurements. During each iteration, the DBA employs a spatio-temporal scheme for trustworthiness evaluation, which acts as a guide for user recruitment in crowdsourced spectrum sensing. The proposed adaptive greedy algorithm gradually incorporates the most trustworthy spectrum measurements. The process of user recruitment can be modeled as a stochastic submodular maximization problem, while guaranteeing budget feasibility, approximate REM accuracy maximization, differential bid privacy. Extensive simulations confirm the efficacy and efficiency of the proposed mechanism.

Abstract:Millimeter wave (mmWave) systems have potential advantages for high accuracy localization due to their large bandwidth and highly directional and sparse channel. The existing schemes on mmWave system localization only explore the channel's angular sparsity and restrict the representation of angular parameters to fixed grids. In this paper, we propose a joint sparse channel model with adjustable grids of angles and delays of mmWave paths, which not only enables exploiting the joint sparsity in angular and delay domain, but also mitigates the quantization error due to fixed grids. We formulate the estimation of channel, angles and delays as a sparse Bayesian learning problem and propose to solve it using an in-exact block minorization-maximization algorithm and then determine the user location. We verify the performance of the algorithm by simulations.
UAV-aided Radio Map Construction Exploiting Environment Semantics

Abstract:This paper constructs a full dimensional (6D) radio map to predict the channel gain between any transmitter location and any receiver location based on received signal strength (RSS) measurements between low-altitude aerial nodes and ground nodes. The main challenge is how to describe the signal strength attenuation due to the blockage from the environment. Conventional interpolation-type approaches fail to exploit the close relation between the radio map and the geometry of the environment. This paper proposes to construct radio maps by first estimating and constructing a multi-class 3D virtual obstacle map that describes the geometry of the environment with radio semantics. Mathematically, a least-squares problem is formulated to jointly estimate the virtual obstacle map and the propagation parameters. This problem is found to have a partial quasiconvexity that leads to the development of an efficient parameter estimation and radio map construction algorithm. Numerical experiments confirm that the proposed method substantially reduces the amount of measurement required for achieving the same radio map accuracy. It is also demonstrated that in a unmanned aerial vehicle (UAV)-aided relay communication scenario, a radio map assisted approach for UAV placement can achieve more than 50% capacity gain.

Abstract:In this paper, we consider the problem of sensing the environment within a wireless cellular framework. Specifically, multiple user equipments (UEs) send sounding signals to one or multiple base stations (BSs) and then a centralized processor retrieves the environmental information from all the channel information obtained at the BS(s). Taking into account the occlusion effect that is common in the wireless context, we make full use of the different views of the environment from different users and/or BS(s), and propose an effective sensing algorithm called GAMP-MVSVR (generalized-approximate-message-passing-based multi-view sparse vector reconstruction). In the proposed algorithm, a multi-layer factor graph is constructed to iteratively estimate the scattering coefficients of the cloud points and their occlusion relationship. In each iteration, the occlusion relationship between the cloud points of the sparse environment is recalculated according to a simple occlusion detection rule, and in turn, used to estimate the scattering coefficients of the cloud points. Our proposed algorithm can achieve improved sensing performance with multi-BS collaboration in addition to the multi-views from the UEs. The simulation results verify its convergence and effectiveness.

Abstract:Providing global coverage for ubiquitous users is a key requirement of the fifth generation (5G) and beyond wireless technologies. This can be achieved by integrating airborne networks, such as unmanned aerial vehicles (UAVs) and satellite networks, with terrestrial networks. However, the deployment of airborne networks in a three-dimensional (3D) or volumetric space requires a new understanding of the propagation channel and its losses in both the areal and altitude dimensions. Despite significant research on radio environment map (REM) construction, much of it has been limited to two-dimensional (2D) contexts. This neglects the altitude-related characteristics of electromagnetic wave propagation and confines REMs to 2D formats, which limits the comprehensive and continuous visualization of propagation environment variation in spatial dimensions. This paper proposes a volumetric REM (VREM) construction approach to compute 3D propagation losses. The proposed approach addresses the limitations of existing approaches by learning the spatial correlation of wireless propagation channel characteristics and visualizing REM in areal and height/altitude dimensions using deep learning models. Specifically, the approach uses two deep learning-based models: volume-to-volume (Vol2Vol) VREM with 3D-generative adversarial networks and sliced VREM with altitude-aware spider-UNets. In both cases, knowledge of the propagation environment and transmitter locations in 3D space is used to capture the spatial and altitude dependency of the propagation channel's characteristics. We developed the Addis dataset, a large REM dataset comprising 54,000 samples collected from the urban part of Addis Ababa, Ethiopia, to train the proposed models. Each sample of data comprises a 512-meter by 512-meter areal resolution with different 3D obstacles (buildings and terrain), 15 simulated propagation loss maps at every 3-meter altitude resolution, and 80 different 3D transmitter locations. The results of the training and testing of the proposed models reveal that the constructed VREMs are statistically comparable. In particular, the Vol2Vol approach has a minimum L1 loss of 0.01, which further decreases to 0.0084 as the line-of-sight (LoS) probability increases to 0.95.

Abstract:Spectrum map construction, which is crucial in cognitive radio (CR) system, visualizes the invisible space of the electromagnetic spectrum for spectrum-resource management and allocation. Traditional reconstruction methods are generally for two-dimensional (2D) spectrum map and driven by abundant sampling data. In this paper, we propose a data-model-knowledge-driven reconstruction scheme to construct the three-dimensional (3D) spectrum map under multi-radiation source scenarios. We firstly design a maximum and minimum path loss difference (MMPLD) clustering algorithm to detect the number of radiation sources in a 3D space. Then, we develop a joint location-power estimation method based on the heuristic population evolutionary optimization algorithm. Considering the variation of electromagnetic environment, we self-learn the path loss (PL) model based on the sampling data. Finally, the 3D spectrum is reconstructed according to the self-learned PL model and the extracted knowledge of radiation sources. Simulations show that the proposed 3D spectrum map reconstruction scheme not only has splendid adaptability to the environment, but also achieves high spectrum construction accuracy even when the sampling rate is very low.

High-Efficiency Urban 3D Radio Map Estimation Based on Sparse Measurements

Abstract:Recent widespread applications for unmanned aerial vehicles (UAVs) -- from infrastructure inspection to urban logistics -- have prompted an urgent need for high-accuracy three-dimensional (3D) radio maps. However, existing methods designed for two-dimensional radio maps face challenges of high measurement costs and limited data availability when extended to 3D scenarios. To tackle these challenges, we first build a real-world large-scale 3D radio map dataset, covering over 4.2 million m^3 and over 4 thousand data points in complex urban environments. We propose a Gaussian Process Regression-based scheme for 3D radio map estimation, allowing us to realize more accurate map recovery with a lower RMSE than state-of-the-art schemes by over 2.5 dB. To further enhance data efficiency, we propose two methods for training point selection, including an offline clustering-based method and an online maximum a posterior (MAP)-based method. Extensive experiments demonstrate that the proposed scheme not only achieves full-map recovery with only 2% of UAV measurements, but also sheds light on future studies on 3D radio maps.

Model and Transfer Spatial-Temporal Knowledge for Fine-Grained Radio Map Reconstruction

Abstract:Radio map, serving as an efficient indicator of wireless environments, has been widely used in many applications such as network monitoring, anomaly signal detection, and localization. It is hard to maintain an update-to-date fine-grained radio map within a large area since the radio map changes rapidly due to internal and external factors. In this paper, we develop a fine-grained radio map reconstruction framework, called Supreme, based on crowdsourced data in an image super-resolution manner. Specifically, Supreme explores spatial-temporal relationships in historical coarse-grained radio maps and builds a real-time fine-grained radio map via a spatial-temporal reconstruction network. Furthermore, a heterogeneous data fusion module is devised to handle external information. Supreme has shown its superiority on real-world datasets. However, it is costly to collect enough fine-grained radio maps as labels considering the labor-intensive collection process and privacy issues. Therefore, we further present the Supreme-UDA that adapts the model from a labeled source domain towards an unlabeled target domain with the help of a domain classifier. Compared with Supreme, the enhanced model effectively transfers spatial-temporal knowledge and improves generalization ability in new scenes even without any annotations. Finally, a case study illustrates that our model can boost localization accuracy in practice.
Diffraction and Scattering Aware Radio Map and Environment Reconstruction using Geometry Model-Assisted Deep Learning

Abstract:Machine learning (ML) facilitates rapid channel modeling for 5G and beyond wireless communication systems. Many existing ML techniques utilize a city map to construct the radio map; however, an updated city map may not always be available. This paper proposes to employ the received signal strength (RSS) data to jointly construct the radio map and the virtual environment by exploiting the geometry structure of the environment. In contrast to many existing ML approaches that lack of an environment model, we develop a virtual obstacle model and characterize the geometry relation between the propagation paths and the virtual obstacles. A multi-screen knife-edge model is adopted to extract the key diffraction features, and these features are fed into a neural network (NN) for diffraction representation. To describe the scattering, as oppose to most existing methods that directly input an entire city map, our model focuses on the geometry structure from the local area surrounding the TX-RX pair and the spatial invariance of such local geometry structure is exploited. Numerical experiments demonstrate that, in addition to reconstructing a 3D virtual environment, the proposed model outperforms the state-of-the-art methods in radio map construction with 10%-18% accuracy improvements. It can also reduce 20% data and 50% training epochs when transferred to a new environment.

Abstract:Radio map, serving as an eﬃcient indicator of wireless environments, has been widely used in smart-city applications, including network monitoring/planning, anomaly signal detection, and indoor/outdoor localization. It is hard to maintain an update-to-date fine-grained radio map within a large area, since the radio map changes rapidly due to the internal and external factors. Previous studies usually relied on time-consuming site surveys at densely predefined reference points, leading to either coarse-grained or out-of-date radio maps. In this paper, we propose a fine-grained radio map reconstruction framework, called Supreme, based on crowd-sourced data in an image super-resolution manner. Specifically, Supreme explores spatial-temporal relationships in historical coarse-grained radio maps and builds a real-time fine-grained radio map using deep spatial-temporal reconstruction networks. Furthermore, a heterogeneous data fusion module is devised to make full use of external information. To evaluate the performance of Supreme, we conduct extensive experiments and ablation studies on a large-scale dataset with a total of six-month data collected from two university campuses. Besides, we investigate the transferability of Supreme in different locations and service networks, showing that the fine-tuned model can largely reduce the training time and achieve better performance. Experimental results demonstrate that our model outperforms state-of-the-art baselines and a case study on the localization is enhanced with marginal improvements on accuracy.

Abstract:A radio environment map (REM) is an effective spectrum management tool. With the increase in the number of mobile devices, the wireless environment changes more and more frequently, bringing new challenges to REM updates. Traditional update methods usually rely on the amount of data collected for updating without paying attention to whether the wireless environment has changed enough. In particular, a waste of computational resources results from the frequently updated REM when the wireless environment does not change much. When the wireless environment changes a lot, the REM is not updated promptly, resulting in a decrease in REM accuracy. To overcome the above problems, this work combines the Siamese neural network and an attention mechanism in computer vision and proposes an update mechanism based on the amount of wireless environmental change starting from image data. The method compares the newly collected crowdsourced data with the constructed REM in terms of similarity. It uses similarity to measure the necessity of the REM to be updated. The algorithm in this paper can achieve a controlled update by setting a similarity threshold with good controllability. In addition, the effectiveness of the algorithm in detecting changes of the wireless environment has been demonstrated by combing simulation data.

Statistical Analysis of Radio Propagation Channel in Ruins Environment

Abstract:The cellphone based localization system for search and rescue in complex high density ruins has attracted a great interest in recent years, where the radio channel characteristics are critical for design and development of such a system. This paper presents a spatial smoothing estimation via rotational invariance technique (SS-ESPRIT) for radio channel characterization of high density ruins. The radio propagations at three typical mobile communication bands (0.9, 1.8, and 2 GHz) are investigated in two different scenarios. Channel parameters, such as arrival time, delays, and complex amplitudes, are statistically analyzed. Furthermore, a channel simulator is built based on these statistics. By comparison analysis of average excess delay and delay spread, the validation results show a good agreement between the measurements and channel modeling results.
Three-Dimensional Radio Spectrum Map Prediction Based on Fully Connected Neural Network

Abstract:Aiming at the problems that the existing radio spectrum maps only consider the two-dimensional map environment hardly meet the engineering requirements, and the simulation time of ray tracing is too long, this paper proposes a three-dimensional (3D) radio spectrum map construction method. First, the ray tracing method is used to obtain the data set, use the data set to train the fully connected neural network, obtain the preliminary model, and set the correction function, so that the model can be modified by a few measured points. Receiving point coordinates and Reference Signal Receiving Power (RSRP) can be obtained only by inputting coordinate values and house map data, and 3D radio spectrum map can be obtained by converting RSRP into thermal values and drawing it into 3D thermal map. The paper reports a remarkable achievement in RSRP prediction accuracy, achieving up to 95% accuracy within 5dB. Furthermore, the proposed method is noted to be significantly faster—up to 60 times—than traditional ray tracing simulations.

Distributed Radio Map Modeling Based on Feature Augmentation of Augmented Scatter Graph

Abstract:Radio map modeling based on the artificial neural network (ANN) has great prospects for applications in base station siting and network coverage optimization. However, the data to be processed contains a large amount of private user data, such as position and route. Moreover, it is difficult for field test users to have detailed information about the transmission environment, such as building heights and contours. In order to solve the above problems, this paper proposes a Distributed learning-based Radio map Modeling method with environment Feature Augmentation based on the Augmented Scatter graph of field test data (DRM-FAAS). In the proposed method, each local user augments the field test data with k-Nearest-Neighbor (KNN) and obtains 15-D augmented environmental features based on target detection of scatter graphs as network input to collaboratively predict the received signal strength (RSS) of all positions in the modeling region. The results on the test dataset show that the modeling accuracy of the proposed method is improved by 13.81 and 4.34 dB, respectively, over the traditional propagation model and the method without environmental feature augmentation. Besides, comparable accuracy is achieved with the modeling method with detailed environmental information.
Two-Stage Radio Map Construction with Real Environments and Sparse Measurements

Abstract:Radio map construction based on extensive measurements is accurate but expensive and time-consuming, while environment-aware radio map estimation reduces the costs at the expense of low accuracy. Considering accuracy and costs, a first-predict-then-correct (FPTC) method is proposed by leveraging generative adversarial networks (GANs). A primary radio map is first predicted by a radio map prediction GAN (RMP-GAN) taking environmental information as input. Then, the prediction result is corrected by a radio map correction GAN (RMC-GAN) with sparse measurements as guidelines. Specifically, the self-attention mechanism and residual-connection blocks are introduced to RMP-GAN and RMC-GAN to improve the accuracy, respectively. Experimental results validate that the proposed FPTC-GANs method achieves the best radio map construction performance, compared with the state-of-the-art methods.

Deep Spectrum Cartography: Completing Radio Map Tensors Using Learned Neural Models

Abstract:The spectrum cartography (SC) technique constructs multi-domain (e.g., frequency, space, and time) radio frequency (RF) maps from limited measurements, which can be viewed as an ill-posed tensor completion problem. Model-based cartography techniques often rely on handcrafted priors (e.g., sparsity, smoothness and low-rank structures) for the completion task. Such priors may be inadequate to capture the essence of complex wireless environments -- especially when severe shadowing happens. To circumvent such challenges, offline-trained deep neural models of radio maps were considered for SC, as deep neural networks (DNNs) are able to "learn" intricate underlying structures from data. However, such deep learning (DL)-based SC approaches encounter serious challenges in both off-line model learning (training) and completion (generalization), possibly because the latent state space for generating the radio maps is prohibitively large. In this work, an emitter radio map disaggregation-based approach is proposed, under which only individual emitters' radio maps are modeled by DNNs. This way, the learning and generalization challenges can both be substantially alleviated. Using the learned DNNs, a fast nonnegative matrix factorization-based two-stage SC method and a performance-enhanced iterative optimization algorithm are proposed. Theoretical aspects -- such as recoverability of the radio tensor, sample complexity, and noise robustness -- under the proposed framework are characterized, and such theoretical properties have been elusive in the context of DL-based radio tensor completion. Experiments using synthetic and real-data from indoor and heavily shadowed environments are employed to showcase the effectiveness of the proposed methods.

A Radio Wave Propagation Modeling Method Based on High-Precision 3-D Mapping in Urban Scenarios

Abstract:Knowledge of the radio channel in urban environments is of key importance in many critical applications, such as wireless communication and autonomous driving. This study proposes a promising radio wave propagation model for complex urban scenarios. First, electrical parameters of different object classes are estimated by utilizing deep-learning-based semantic segmentation applied to a point cloud. Second, a highly accurate 3-D geometrical and electromagnetic (EM) model of the environment is obtained by surface reconstruction. Finally, ray tracing, based on geometrical optics and the uniform theory of diffraction (UTD), is applied to the environmental model to generate path-loss predictions. A comparison with measured data shows that the ray tracing based on accurate 3-D building reconstruction is more accurate than when applied to simpler geometric models.
