Abstract:We described a study on the use of an online laboratory for self-directed learning by constructing and simulating conceptual models of ecological systems. In this study, we could observe only the modeling behaviors and outcomes; the learning goals and outcomes were unknown. We used machine learning techniques to analyze the modeling behaviors of 315 learners and 822 conceptual models they generated. We derive three main conclusions from the results. First, learners manifest three types of modeling behaviors: observation (simulation focused), construction (construction focused), and full exploration (model construction, evaluation and revision). Second, while observation was the most common behavior among all learners, construction without evaluation was more common for less engaged learners and full exploration occurred mostly for more engaged learners. Third, learners who explored the full cycle of model construction, evaluation and revision generated models of higher quality. These modeling behaviors provide insights into self-directed learning at large.

Abstract:Conventional machine learning (ML) relies heavily on manual design from machine learning experts to decide learning tasks, data, models, optimization algorithms, and evaluation metrics, which is labor-intensive, time-consuming, and cannot learn autonomously like humans. In education science, self-directed learning, where human learners select learning tasks and materials on their own without requiring hands-on guidance, has been shown to be more effective than passive teacher-guided learning. Inspired by the concept of self-directed human learning, we introduce the principal concept of Self-directed Machine Learning (SDML) and propose a framework for SDML. Specifically, we design SDML as a self-directed learning process guided by self-awareness, including internal awareness and external awareness. Our proposed SDML process benefits from self task selection, self data selection, self model selection, self optimization strategy selection and self evaluation metric selection through self-awareness without human guidance. Meanwhile, the learning performance of the SDML process serves as feedback to further improve self-awareness. We propose a mathematical formulation for SDML based on multi-level optimization. Furthermore, we present case studies together with potential applications of SDML, followed by discussing future research directions. We expect that SDML could enable machines to conduct human-like self-directed learning and provide a new perspective towards artificial general intelligence.

Abstract:In adult education, the concept of self-directed learning has great importance. This term arose in the field of adult education in the 1970s and is still a widely used term in the field. Annual symposiums have been held by the International Society for Self-Directed Learning since 1986, dedicated to the promotion of self-directed learning. The society also publishes an international journal of self-directed learning. A term of more recent origin is self-regulation, used by some authors sometimes interchangeably with self-direction. This review article focuses on the term self-directed learning, which is the term most frequently used in adult education. Many consider the tendency for self-direction to be a fundamental difference between children and adults in a learning situation. This article deals with some factors that affect the understanding of self-directed learning. At the beginning is given a short case story and an account for different perceptions of self-directed learning. This is followed by a clarification of different aspects of self-directed learning, such as why it is advisable, what affects the tendency to self-directed learning, and if self-direction is essentially innate or learned. The situational aspect is dealt with separately as a relatively self-contained aspect of self-directed learning. The presentation is based on a literature study.

Abstract:This study explores the interplay between Self-Determination (SDT), relatedness, and teaching presence and CoI's presence (teaching, cognitive, and social) in the context of online educational settings within China. Specifically, the study employs the Partial Least Squares Structural Equation Modeling (PLS-SEM) to investigate the interaction between SDT (Self-Determination, relatedness, and competence) and the perceived learning outcomes (autonomy, competence, and perceived learning). The underlying structure of the study's conceptual framework was analyzed through the measurement model and the discriminant validity assessment. The results show that cognitive presence, social presence, and teaching presence are significantly associated with autonomy, competence, relevance, and perceived learning. Moreover, cognitive presence and social presence can potentially augment cognitive processes, amplifying the mediating role of relatedness between cognitive presence and learning outcomes.

Abstract:Given that massive open online learning courses (MOOCs) are considerably different from traditional classrooms in terms of roles and responsibilities of instructors and learners, successful learners are required to be self-directed in MOOC learning environments. One of the most popular self-directed learning (SDL) models proposed by Garrison (Adult Education Quarterly 48(1):18–33, <a href="https://doi.org/10.1177/074171369704800103">https://doi.org/10.1177/074171369704800103</a>, <a href="/article/10.1007/s11423-020-09747-8?shared-article-renderer#ref-CR32">1997</a>) includes three components: motivation, self-monitoring, and self-management. This model was originally discussed from traditional online and face-to-face learning environment. Thus, the present study investigated the relationship among motivation, self-monitoring, and self-management in MOOCs by surveying 322 MOOC learners. Using structural equation modeling, this study found that motivation directly affected self-monitoring and indirectly influenced self-management through self-monitoring. In addition, self-monitoring positively influenced self-management. Therefore, promoting student self-monitoring skills and motivating students is critical. Additional research is needed on the ways to facilitate and support self-monitoring of MOOC learners. Future research could examine the influence of the three elements of SDL on learning achievement and engagement. In addition, further exploration of learner behaviors in MOOCs could provide insights on facilitating learners' SDL.

Abstract:Learning theory has largely focused on two main learning scenarios. The first is the classical statistical setting where instances are drawn i.i.d. from a fixed distribution and the second scenario is the online learning, completely adversarial scenario where adversary at every time step picks the worst instance to provide the learner with. It can be argued that in the real world neither of these assumptions are reasonable. It is therefore important to study problems with a range of assumptions on data. Unfortunately, theoretical results in this area are scarce, possibly due to absence of general tools for analysis. Focusing on the regret formulation, we define the minimax value of a game where the adversary is restricted in his moves. The framework captures stochastic and non-stochastic assumptions on data. Building on the sequential symmetrization approach, we define a notion of distribution-dependent Rademacher complexity for the spectrum of problems ranging from i.i.d. to worst-case. The bounds let us immediately deduce variation-type bounds. We then consider the i.i.d. adversary and show equivalence of online and batch learnability. In the supervised setting, we consider various hybrid assumptions on the way that x and y variables are chosen. Finally, we consider smoothed learning problems and show that half-spaces are online learnable in the smoothed model. In fact, exponentially small noise added to adversary's decisions turns this problem with infinite Littlestone's dimension into a learnable problem.

Adaptivity Through Self-Directed Learning to Meet the Challenges of Our Ever-Changing World

Abstract:Fostering adult learners’ competence to adapt appropriately to our ever-changing world is a primary concern of adult education. The purpose of the present article is novel and examines whether the consideration of modes of learning (instruction, performance, and inquiry) could assist in the design of adult education that facilitates self-directed learning and enables learners to think and perform adaptively. The concept of modes of learning originated from the typology of Houle. However, to date, no study has reached beyond this typology, especially concerning the potential of using modes of learning in the design of adult education. Specifically, an apparent oversight in adult learning theory is the foremost importance of the consideration of whether inquiry is included in the learning process: its inclusion potentially differentiates the purpose of instruction, the nature of learners’ performance, and the underlying epistemological positioning. To redress this concern, two models of modes of learning are proposed and contrasted. The reinforcing model of modes of learning (instruction, performance, without inquiry) promotes teacher-directed learning. A key consequence of employing this model in adult education is that learners may become accustomed to habitually reinforcing patterns of perceiving, thinking, judging, feeling, and acting—performance that may be rather inflexible and represented by a distinct lack of a perceived need to adapt to social contextual changes: a lack of motivation for self-directed learning. Rather, the adapting model of modes of learning (instruction, performance, with inquiry) may facilitate learners to be adaptive in their performance—by encouraging an enhanced learner sensitivity toward changing social contextual conditions: potentially enhancing learners’ motivation for self-directed learning.
Online Continual Adaptation with Active Self-Training

Abstract:Models trained with offline data often suffer from continual distribution shifts and expensive labeling in changing environments. This calls for a new online learning paradigm where the learner can continually adapt to changing environments with limited labels. In this paper, we propose a new online setting - Online Active Continual Adaptation, where the learner aims to continually adapt to changing distributions using both unlabeled samples and active queries of limited labels. To this end, we propose Online Self-Adaptive Mirror Descent (OSAMD), which adopts an online teacher-student structure to enable online self-training from unlabeled data, and a margin-based criterion that decides whether to query the labels to track changing distributions. Theoretically, we show that, in the separable case, OSAMD has an O(T-2/3) dynamic regret bound under mild assumptions, which is aligned with the Omega(T-2/3) lower bound of online learning algorithms with full labels. In the general case, we show a regret bound of O(T-2/3 + alpha*T), where alpha* denotes the separability of domains and is usually small. Our theoretical results show that OSAMD can fast adapt to changing environments with active queries. Empirically, we demonstrate that OSAMD achieves favorable regrets under changing environments with limited labels on both simulated and real-world data, which corroborates our theoretical findings.
Explaining Online Reinforcement Learning Decisions of Self-Adaptive Systems

Abstract:Design time uncertainty poses an important challenge when developing a self-adaptive system. As an example, defining how the system should adapt when facing a new environment state, requires understanding the precise effect of an adaptation, which may not be known at design time. Online reinforcement learning, i.e., employing reinforcement learning (RL) at runtime, is an emerging approach to realizing self-adaptive systems in the presence of design time uncertainty. By using Online RL, the self-adaptive system can learn from actual operational data and leverage feedback only available at runtime. Recently, Deep RL is gaining interest. Deep RL represents learned knowledge as a neural network whereby it can generalize over unseen inputs, as well as handle continuous environment states and adaptation actions. A fundamental problem of Deep RL is that learned knowledge is not explicitly represented. For a human, it is practically impossible to relate the parametrization of the neural network to concrete RL decisions and thus Deep RL essentially appears as a black box. Yet, understanding the decisions made by Deep RL is key to (1) increasing trust, and (2) facilitating debugging. Such debugging is especially relevant for self-adaptive systems, because the reward function, which quantifies the feedback to the RL algorithm, must be defined by developers. The reward function must be explicitly defined by developers, thus introducing a potential for human error. To explain Deep RL for self-adaptive systems, we enhance and combine two existing explainable RL techniques from the machine learning literature. The combined technique, XRL-DINE, overcomes the respective limitations of the individual techniques. We present a proof-of-concept implementation of XRL-DINE, as well as qualitative and quantitative results of applying XRL-DINE to a self-adaptive system exemplar.

Dealing with Drift of Adaptation Spaces in Learning-based Self-Adaptive Systems using Lifelong Self-Adaptation

Abstract:Recently, machine learning (ML) has become a popular approach to support self-adaptation. ML has been used to deal with several problems in self-adaptation, such as maintaining an up-to-date runtime model under uncertainty and scalable decision-making. Yet, exploiting ML comes with inherent challenges. In this paper, we focus on a particularly important challenge for learning-based self-adaptive systems: drift in adaptation spaces. With adaptation space we refer to the set of adaptation options a self-adaptive system can select from at a given time to adapt based on the estimated quality properties of the adaptation options. Drift of adaptation spaces originates from uncertainties, affecting the quality properties of the adaptation options. Such drift may imply that eventually no adaptation option can satisfy the initial set of the adaptation goals, deteriorating the quality of the system, or adaptation options may emerge that allow enhancing the adaptation goals. In ML, such shift corresponds to novel class appearance, a type of concept drift in target data that common ML techniques have problems dealing with. To tackle this problem, we present a novel approach to self-adaptation that enhances learning-based self-adaptive systems with a lifelong ML layer. We refer to this approach as lifelong self-adaptation. The lifelong ML layer tracks the system and its environment, associates this knowledge with the current tasks, identifies new tasks based on differences, and updates the learning models of the self-adaptive system accordingly. A human stakeholder may be involved to support the learning process and adjust the learning and goal models. We present a general architecture for lifelong self-adaptation and apply it to the case of drift of adaptation spaces that affects the decision-making in self-adaptation. We validate the approach for a series of scenarios using the DeltaIoT exemplar.

Abstract:Self-regulated learning (SRL) plays a critical role in asynchronous online courses. In recent years, attention has been focused on identifying student subgroups with different patterns of online SRL behaviors and comparing their learning performance. However, there is limited research leveraging traces of SRL behaviors to detect student subgroups and examine the subgroup differences in cognitive load and student engagement. The current study tracked the engagement of 101 graduate students with SRL-enabling tools integrated into an asynchronous online course. According to the recorded SRL behaviors, this study identified two distinct student subgroups, using sequence analysis and cluster analysis: high SRL (H-SRL) and low SRL (L-SRL) groups. The H-SRL group showed lower extraneous cognitive load and higher learning performance, germane cognitive load, and cognitive engagement than the L-SRL group did. Additionally, this study articulated and compared temporal patterns of online SRL behaviors between the student subgroups combining lag sequential analysis and epistemic network analysis. The results revealed that both groups followed three phases of self-regulation but performed off-task behaviors. Additionally, the H-SRL group preferred activating mastery learning goals to improve ethical knowledge, whereas the L-SRL group preferred choosing performance-avoidance learning goals to pass the unit tests. The H-SRL group invested more in time management and notetaking, whereas the L-SRL group engaged more in surface learning approaches. This study offers researchers both theoretical and methodological insights. Additionally, our research findings help inform practitioners about how to design and deploy personalized SRL interventions in asynchronous online courses.

Abstract:Self-regulated learning has seen a large increase in research interest due to its importance for online learning of higher education students. Several ways to measure self-regulated learning have been suggested. However, most measurements are either obtrusive, necessitating time and effort from students and potentially influencing the learning process, or only partially portable across courses. In the current study, we develop clickstream-based scales of four self-regulated learning phases that we show are portable across courses. The final scales are based on the COPES model and include two strong and reliable dimensions, enactment and adaptation, one dimension that performs reasonably, task definition, and a weaker one, goal-setting. By considering portability as the main criterion in the scale construction process, we ensured reliable transfer to both similar and dissimilar courses. When considering convergent validity, the created scale has higher bivariate and partial correlations with final student grades than the often-used self-reported MSLQ-SRL scale. We discuss limitations and future research to improve the scale further and facilitate adoption.

The role of self-directed learning in studying 3D design and modeling

Abstract:3D design and modeling is an important part of design education. Self-directed learning (SDL) has been considered in order to effectively learn and teach 3D design and modeling. Exploring the relationship between students' SDL ability and their behavior in learning 3D design will not only promote the 3D design learning process and outcomes, but also enhance their SDL ability. This study explored the relationship among students' SDL ability, their learning behavior, and 3D works in a self-directed 3D design class. Twenty-two masters students participated in the study. Results showed that students had a relatively high SDL ability. Their SDL ability slightly increased with no statistical significance after the class. There were significant differences in 3D design and modeling learning behaviors between high-level SDL students and low-level SDL students. Students' SDL ability positively correlated with the quality of 3D works in terms of the feasibility, functionality, and creativity. Students had positive perceptions on the self-directed 3D design class in terms of both SDL experience and 3D design experience.

Abstract:Self-directed learning (SDL) ability, its usefulness in higher education and life-long learning have been highlighted in previous literature. However, there has been much less understanding of the effects of SDL ability in the school settings, specifically the effects on learners' SDL behaviors and processes. To address this limitation, this study investigated the relations between SDL ability, SDL behaviors, and reading outcomes and further explored the process of planning behaviors in SDL. This study examined the context of SDL for extensive reading using a goal-oriented active learning system, GOAL. The results showed that the high SDL ability students demonstrated significantly more reading outcomes in terms of books completed and the number of days read than those with low SDL ability. The high SDL ability students engaged significantly more in planning behaviors, that were found to be significantly correlated with reading outcomes, than the low SDL ability students. Cluster analysis and transition analysis also differentiate groups of learners with different planning behaviors. These findings suggested that the learning behaviors and outcomes facilitated by the environment were affected to varying degrees by the levels of students' SDL ability, and personalized feedback can be created using the SDL behavioral variables and patterns in the environment.

Abstract:We propose self-adaptive training-a unified training algorithm that dynamically calibrates and enhances training processes by model predictions without incurring an extra computational cost-to advance both supervised and self-supervised learning of deep neural networks. We analyze the training dynamics of deep networks on training data that are corrupted by, e.g., random noise and adversarial examples. Our analysis shows that model predictions are able to magnify useful underlying information in data and this phenomenon occurs broadly even in the absence of any label information, highlighting that model predictions could substantially benefit the training processes: self-adaptive training improves the generalization of deep networks under noise and enhances the self-supervised representation learning. The analysis also sheds light on understanding deep learning, e.g., a potential explanation of the recently-discovered double-descent phenomenon in empirical risk minimization and the collapsing issue of the state-of-the-art self-supervised learning algorithms. Experiments on the CIFAR, STL, and ImageNet datasets verify the effectiveness of our approach in three applications: classification with label noise, selective classification, and linear evaluation. Abstract:Learning is a process wherein a learning agent enhances its performance through exposure of experience or data. Throughout this journey, the agent may encounter diverse learning environments. For example, data may be presented to the leaner all at once, in multiple batches, or sequentially. Furthermore, the distribution of each data sample could be either identical and independent (iid) or non-iid. Additionally, there may exist computational and space constraints for the deployment of the learning algorithms. The complexity of a learning task can vary significantly, depending on the learning setup and the constraints imposed upon it. However, it is worth noting that the current literature lacks formal definitions for many of the in-distribution and out-of-distribution learning paradigms. Establishing proper and universally agreed-upon definitions for these learning setups is essential for thoroughly exploring the evolution of ideas across different learning scenarios and deriving generalized mathematical bounds for these learners. In this paper, we aim to address this issue by proposing a chronological approach to defining different learning tasks using the provably approximately correct (PAC) learning framework. We will start with in-distribution learning and progress to recently proposed lifelong or continual learning. We employ consistent terminology and notation to demonstrate how each of these learning frameworks represents a specific instance of a broader, more generalized concept of learnability. Our hope is that this work will inspire a universally agreed-upon approach to quantifying different types of learning, fostering greater understanding and progress in the field.

Abstract:Massive Open Online Courses (MOOCs) can meet education needs from diverse social, cultural, and access backgrounds and require a minimal cost of resources from learners.To successfully scaffold large and distributed populations to learn effectively in these MOOCs, the design needs to optimize self-directed learning.In this paper, the researchers investigated the design variables for MOOCs' learning environment that allowed learning choices made by learners.With this study, the researchers developed a 21-item questionnaire based on a review of the literature and their MOOC design and implementation practices, Massive Online Open Course Learning Environment Design Questionnaire (MOOC-LED).The researchers used the quantitative survey study and developed an initial examination of the MOOC-LED factor structure, validity, and internal reliability.The analyses were based on the anonymous data of 162 participants' perception of learning in MOOCs.The scholarly significance of the 21-item MOOC-LED questionnaire is discussed with its limitations, implications, and future directions.
Dimensionally Distributed Learning: Models and Algorithm

Abstract:This paper introduces a framework for regression with dimensionally distributed data with a fusion center. A cooperative learning algorithm, the iterative conditional expectation algorithm (ICEA), is designed within this framework. The algorithm can effectively discover linear combinations of individual estimators trained by each agent without transferring and storing large amount of data amongst the agents and the fusion center. The convergence of ICEA is explored. Specifically, for a two agent system, each complete round of ICEA is guaranteed to be a non-expansive map on the function space of each agent. The advantages and limitations of ICEA are also discussed for data sets with various distributions and various hidden rules. Moreover, several techniques are also designed to leverage the algorithm to effectively learn more complex hidden rules that are not linearly decomposable.

Abstract:Self-Determination Theory (SDT) has been studied to comprehend human motivation, particularly in education. Numerous studies have been conducted at universities regarding online learning as a technology to mitigate the effects of COVID-19. On the basis of these expansions, however, there is a knowledge gap regarding what constitutes advancement, future direction, and research gaps regarding SDT in university online learning. This new systematic literature review analyzed 49 articles using PRISMA to bridge the knowledge gap. Currently, SDT research in online learning at university does not extensively integrate other theories and models, but there is a trend toward acceptance models and cognitive theories. Future research should incorporate additional SDT factors such as intrinsic motivation, external regulation, identified regulation, and amotivation in addition to autonomy, competence, and relatedness. As most research samples students, a research gap involving lecturers and mixed groups is suggested. The future is anticipated to be dominated by quantitative research, leaving qualitative and mixed methods as points of exploration. This review sheds light on the advancements, future direction, and research gaps regarding SDT in university-level online learning. It could serve as a basis for future research in SDT within the context of online education.

Self-Interested Agents in Collaborative Learning: An Incentivized Adaptive Data-Centric Framework

Abstract:We propose a framework for adaptive data-centric collaborative learning among self-interested agents, coordinated by an arbiter. Designed to handle the incremental nature of real-world data, the framework operates in an online manner: at each step, the arbiter collects a batch of data from agents, trains a machine learning model, and provides each agent with a distinct model reflecting its data contributions. This setup establishes a feedback loop where shared data influence model updates, and the resulting models guide future data-sharing strategies. Agents evaluate and partition their data, selecting a partition to share using a stochastic parameterized policy optimized via policy gradient methods to optimize the utility of the received model as defined by agent-specific evaluation functions. On the arbiter side, the expected loss function over the true data distribution is optimized, incorporating agent-specific weights to account for distributional differences arising from diverse sources and selective sharing. A bilevel optimization algorithm jointly learns the model parameters and agent-specific weights. Mean-zero noise, computed using a distortion function that adjusts these agent-specific weights, is introduced to generate distinct agent-specific models, promoting valuable data sharing without requiring separate training. Our framework is underpinned by non-asymptotic analyses, ensuring convergence of the agent-side policy optimization to an approximate stationary point of the evaluation functions and convergence of the arbiter-side optimization to an approximate stationary point of the expected loss function.
