Abstract:This work studies machine learning for electron density prediction, which is fundamental for understanding chemical systems and density functional theory (DFT) simulations. To this end, we introduce the Gaussian plane-wave neural operator (GPWNO), which operates in the infinite-dimensional functional space using the plane-wave and Gaussian-type orbital bases, widely recognized in the context of DFT. In particular, both high- and low-frequency components of the density can be effectively represented due to the complementary nature of the two bases. Extensive experiments on QM9, MD, and material project datasets demonstrate GPWNO's superior performance over ten baselines.

What problem does this paper attempt to address?
This paper mainly discusses the problem of electron density prediction, which is the foundation for understanding chemical systems and density functional theory (DFT) simulation. A new approach called Gaussian Plane Wave Neural Operator (GPWNO) is proposed in the study, which operates in an infinite-dimensional function space and combines plane waves and Gaussian-type orbital bases, both of which are widely used in DFT. GPWNO is able to effectively represent the high and low frequency components of the density due to the complementarity of the two bases. Extensive experiments on the QM9, MD, and Materials Project datasets have shown that GPWNO outperforms ten baseline methods. The main contributions of the paper are as follows: 1. GPWNO is proposed to predict electron density by combining Gaussian-type orbitals (GTO) and plane waves (PW), which helps to simultaneously capture the high and low frequency signals in the density. The design ensures SE(3) covariance and satisfies periodic boundary conditions. 2. GPWNO consists of two parts: GTO-based prediction for the high frequency part in the vicinity of atoms, and PW-based prediction for the global low frequency part. In addition, a high-frequency masking strategy is introduced to focus PW bases on regions away from the atomic centers. The experimental results demonstrate that GPWNO performs significantly better than previous approaches on the QM9, MD, and Materials Project datasets. The paper also verifies the effectiveness of each component of the algorithm through ablation studies. In summary, this paper aims to address the complexity of electron density prediction and improve the accuracy and efficiency of prediction, especially in dealing with periodic molecules, by using a neural operator.
