Abstract:Recently, generative AI technologies have emerged as a significant advancement in artificial intelligence field, renowned for their language and image generation capabilities. Meantime, space-air-ground integrated network (SAGIN) is an integral part of future B5G/6G for achieving ubiquitous connectivity. Inspired by this, this article explores an integration of generative AI in SAGIN, focusing on potential applications and case study. We first provide a comprehensive review of SAGIN and generative AI models, highlighting their capabilities and opportunities of their integration. Benefiting from generative AI's ability to generate useful data and facilitate advanced decision-making processes, it can be applied to various scenarios of SAGIN. Accordingly, we present a concise survey on their integration, including channel modeling and channel state information (CSI) estimation, joint air-space-ground resource allocation, intelligent network deployment, semantic communications, image extraction and processing, security and privacy enhancement. Next, we propose a framework that utilizes a Generative Diffusion Model (GDM) to construct channel information map to enhance quality of service for SAGIN. Simulation results demonstrate the effectiveness of the proposed framework. Finally, we discuss potential research directions for generative AI-enabled SAGIN.

- Traditional methods such as grid-based approaches, genetic algorithms, and reinforcement learning (RL) are effective in specific settings but may not be suitable for the diversity and dynamic demands of the SAGIN environment. Generative AI, particularly VAE and Transformer-Based Models (TBM), can provide intelligent network deployment methods, improving network heterogeneity and resource allocation efficiency.
4. **Semantic Communication**:
- Traditional semantic communication methods like ontology-based data representation or Convolutional Neural Networks (CNN) provide structured data representation and communication methods but may become rigid in SAGIN, unable to adapt to new or evolving data patterns. Generative AI, especially GDM and TBM, can offer effective semantic communication methods by simulating data distributions and establishing context-aware communication environments.
5. **Image Extraction and Processing**:
- Traditional methods like edge detection, Fourier transform, and CNN can handle images but may struggle with the diverse and complex images in SAGIN scenarios. Generative AI, particularly VAE and GAN, can provide methods for image extraction and processing by compressing and extracting high-dimensional image data and generating high-quality images.
6. **Security and Privacy Enhancement**:
- Traditional security measures like Intrusion Detection Systems (IDS) and Deep Belief Networks (DBN) are important but may fail to recognize emerging or evolving threats, especially those exploiting unknown vulnerabilities. Generative AI, particularly GDM and GAN, can enhance network security and privacy protection by modeling data distributions and simulating security vulnerabilities.
### Challenges
Despite the broad prospects of applying Generative AI in SAGIN, several challenges remain:
1. **Real-Time Response**:
- Integrating Generative AI requires immediate and responsive processing and decision-making capabilities. Any delay could severely impact the effectiveness of the rapidly changing network. Ensuring quick adaptation to changing conditions, reducing latency, and improving overall network performance are key to the successful integration of Generative AI.
2. **Integration Overhead**:
- Integrating Generative AI introduces additional computational and communication complexity. Efficiently managing this integration overhead is crucial to ensure that the enhanced capabilities do not come at the cost of system performance or network efficiency. For example, training GAN models may require hundreds of GPU hours and significant cloud resources. Additionally, the real-time application of these models may introduce delays due to data transmission.
3. **Scalability Issues**:
- The SAGIN architecture includes ground, aerial, and space components, and integrating Generative AI presents scalability challenges. As the network grows and more devices and nodes are added, the demand for Generative AI technologies will increase. Ensuring that Generative AI technologies can scale effectively without compromising their performance or network reliability is key to the long-term success of Generative AI-enabled SAGIN.
### Proposed Framework
To address the challenges posed by multipath errors, the paper proposes a channel information map construction framework based on Generative Diffusion Models (GDM). This framework, leveraging Generative AI technologies, can effectively solve the multipath error problem of Non-Line-of-Sight (NLOS) signals in urban environments, thereby improving the quality of service in SAGIN.
