Abstract:Analyzing and modeling the constitutive behavior of materials is a core area in materials sciences and a prerequisite for conducting numerical simulations in which the material behavior plays a central role. Constitutive models have been developed since the beginning of the 19th century and are still under constant development. Besides physics-motivated and phenomenological models, during the last decades, the field of constitutive modeling was enriched by the development of machine learning-based constitutive models, especially by using neural networks. The latter is the focus of the present review, which aims to give an overview of neural networks-based constitutive models from a methodical perspective. The review summarizes and compares numerous conceptually different neural networks-based approaches for constitutive modeling including neural networks used as universal function approximators, advanced neural network models and neural network approaches with integrated physical knowledge. The upcoming of these methods is in-turn closely related to advances in the area of computer sciences, what further adds a chronological aspect to this review. We conclude this review paper with important challenges in the field of learning constitutive relations that need to be tackled in the near future.

What problem does this paper attempt to address?
The paper attempts to address the problem of modeling material constitutive behavior in materials science. Specifically, it focuses on how to use neural network technology to establish models of material behavior under different conditions. Traditionally, the constitutive relationships of materials are described through physically motivated models or phenomenological models, which rely on a deep understanding of the material's microstructure and behavior. However, with the development of machine learning technology, especially the application of neural networks, researchers have begun to explore how to use data-driven methods to model the nonlinear behavior of materials. The main objectives of the paper include: 1. **Review the application of neural networks in material constitutive modeling**: From general function approximators to advanced neural network models, and to neural network methods combined with physical knowledge, the paper systematically reviews the progress in this field. 2. **Compare different types of neural network models**: The paper provides a detailed comparison of various neural network-based constitutive modeling methods, including feedforward neural networks (FFNNs), recurrent neural networks (RNNs), convolutional neural networks (CNNs), etc., and discusses their advantages and disadvantages. 3. **Explore the combination of physical knowledge and neural networks**: The paper pays special attention to how to incorporate physical knowledge into neural networks to improve the interpretability and generalization ability of the models, such as through the use of physics-informed neural networks (PINNs). 4. **Propose challenges for future research**: The paper summarizes the main challenges currently faced in the field, such as data requirements, model interpretability, generalization ability, etc., and looks forward to future research directions. In summary, this paper aims to provide readers with a comprehensive perspective on the latest developments and future potential of neural networks in material constitutive modeling.
