Abstract:As one important application of synthetic aperture radar (SAR), ship classification attracts researchers' attention in recent years. To improve the accuracy of ship classification in dual-polarized SAR images, we here put forward a novel polarimetric feature-guided deep network (PFDN). Detailedly, a new polarimetric feature smoothed-polarimetric information fusion (SPF) is first built through fusing both amplitudes of dual-polarized channels. Since only the amplitude information are used, SPF cannot be affected by the phase noise. Then, another two key components, i.e., the multiscale feature fusion attention module (MFFAM) and the dynamic gating feature fusion mechanism (DGFFM), are further proposed to extract deeper classification features. Finally, via combining these three different modules together, PFDN is constructed. Experiments tested on the dataset OpenSARShip2.0 show that PFDN can achieve higher accuracies (87.13% in three-class task and 65.97% in six-class task) than the other state-of-the-art (SOTA) methods.

Abstract:With the rapid development of the modern world, it is imperative to achieve effective and efficient monitoring for territories of interest, especially for the broad ocean area. For surveillance of ship targets at sea, a common and powerful approach is to take advantage of satellite synthetic aperture radar (SAR) systems. Currently, using satellite SAR images for ship classification is a challenging issue due to complex sea situations and the imaging variances of ships. Fortunately, the emergence of advanced satellite SAR sensors has shed much light on the SAR ship automatic target recognition (ATR) task, e.g., utilizing dual-polarization (dual-pol) information to boost the performance of SAR ship classification. Therefore, in this paper we have developed a novel cross-polarimetric interaction network (CPINet) to explore the abundant polarization information of dual-pol SAR images with the help of deep learning strategies, leading to an effective solution for high-performance ship classification. First, we establish a novel multiscale deep feature extraction framework to fully mine the characteristics of dual-pol SAR images in a coarse-to-fine manner. Second, to further leverage the complementary information of dual-pol SAR images, we propose a mixed-order squeeze–excitation (MO-SE) attention mechanism, in which the first- and second-order statistics of the deep features from one single-polarized SAR image are extracted to guide the learning of another polarized one. Then, the intermediate multiscale fused and MO-SE augmented dual-polarized deep feature maps are respectively aggregated by the factorized bilinear coding (FBC) pooling method. Meanwhile, the last multiscale fused deep feature maps for each single-polarized SAR image are also individually aggregated by the FBC. Finally, four kinds of highly discriminative deep representations are obtained for loss computation and category prediction. For better network training, the gradient normalization (GradNorm) method for multitask networks is extended to adaptively balance the contribution of each loss component. Extensive experiments on the three- and five-category dual-pol SAR ship classification dataset collected from the open and free OpenSARShip database demonstrate the superiority and robustness of CPINet compared with state-of-the-art methods for the dual-polarized SAR ship classification task.

Abstract:Current synthetic aperture radar (SAR) ship classifiers using convolutional neural networks (CNNs) offer state-of-the-art performance. Yet, they still have two defects potentially hindering accuracy progress - polarization insufficient utilization and traditional feature abandonment. Therefore, we propose a polar-ization fusion network with geometric feature embedding (PFGFE-Net) to solve them. PFGFE-Net achieves the polarization fusion (PF) from the input data, feature-level, and decision-level. Moreover, the geometric feature embedding (GFE) enriches expert experience. Abstract:Ship detection in synthetic aperture radar (SAR) images is a significant and challenging task. However, most existing deep learning-based SAR ship detection approaches are confined to single-polarization SAR images and fail to leverage dual-polarization characteristics, which increases the difficulty of further improving the detection performance. One problem that requires a solution is how to make full use of the dual-polarization characteristics and how to excavate polarization features using the ship detection network. To tackle the problem, we propose a group-wise feature enhancement-and-fusion network with dual-polarization feature enrichment (GWFEF-Net) for better dual-polarization SAR ship detection. GWFEF-Net offers four contributions: (1) dual-polarization feature enrichment (DFE) for enriching the feature library and suppressing clutter interferences to facilitate feature extraction; (2) group-wise feature enhancement (GFE) for enhancing each polarization semantic feature to highlight each polarization feature region; (3) group-wise feature fusion (GFF) for fusing multi-scale polarization features to realize polarization features' group-wise information interaction; (4) hybrid pooling channel attention (HPCA) for channel modeling to balance each polarization feature's contribution. We conduct sufficient ablation studies to verify the effectiveness of each contribution. Extensive experiments on the Sentinel-1 dual-polarization SAR ship dataset demonstrate the superior performance of GWFEF-Net, with 94.18% in average precision (AP), compared with the other ten competitive methods. Specifically, GWFEF-Net can yield a 2.51% AP improvement compared with the second-best method.

SE-LPN-DPFF offers three contributions: 1) dual-polarization (VV and VH) feature fusion (DPFF); 2) channel modeling by the squeeze-and-excitation (SE) to balance each polarization feature's contribution; and 3) Laplacian pyramid network (LPN) to achieve multiresolution analysis (MRA). Extensive ablation studies can confirm the effectiveness of each contribution. Results on the three- and six-category OpenSARShip datasets reveal the state-of-the-art SAR ship classification performance.

Abstract:Ship classification is usually a challenging task due to the small sizes of ship targets and the lack of significant differences between different categories. In terms of synthetic aperture radar (SAR) images, most existing deep learning (DL)-based methods are not designed from the angle of polarimetric characteristics to achieve ship classification. Thus, when facing the ship classification task of dual-polarized SAR images, these networks are often unsatisfactory. To cure this shortcoming, we here propose a novel dual branch deep network (DBDN) specifically designed for dual-polarized SAR ship classification. Our approach consists of three key modules: the image construction module (ICM), the feature extraction module (FEM), and the feature fusion and classifier module (FFCM). In ICM, two novel pseudo-RGB images are constructed for the first time, i.e., the polarimetric features-guided pseudo-RGB image (PF-RGB) and the texture features-guided pseudo-RGB image (TF-RGB), which can more accurately and comprehensively reflect ships' characteristics. FEM enables the network to focus on important ship features and suppress irrelevant noise through transferred layers and designed ConvNeXt-Attention block (CNABlock), enhancing the discriminative capability of different ships. Finally, FFCM extracts and combines various ship features for classification, wherein the enhanced inverted residual block (EIRBlock) and the channel spatial attention module (CSAM) components are proposed as well. The performance of DBDN is evaluated on the OpenSARShip2.0 dataset, and experimental results show that DBDN achieves excellent performance in all evaluation metrics in comparison with some state-of-the-art (SOTA) algorithms. For example, compared to the recently proposed method deep SAR-net (DSN), DBDN further improves the accuracy by 4.74% and 4.07% in the three-class and six-class classification tasks, respectively.

Abstract:Ship classification from synthetic aperture radar (SAR) images tends to be a hotspot in the remote sensing community. Currently, more efforts have been made to the single-polarization (single-pol) SAR ship classification with limited performance. This letter proposes to explore the dual-polarization (dual-pol) SAR images for better ship classification. To be specific, a novel group bilinear convolutional neural network (GBCNN) model is developed to deeply extract discriminative second-order representations of ship targets from the pairwise vertical-horizontal polarization (VH) and vertical-vertical polarization (VV) SAR images. In particular, the deep bilinear features are efficiently acquired by performing the bilinear pooling on subgroups of deep feature maps derived from the single-pol SAR images (self-bilinear pooling) and dual-pol SAR images (cross-bilinear pooling). To fully explore the polarization information, the multipolarization fusion loss (MPFL) is constructed to train the proposed model for superior SAR ship representation learning. Through extensive experiments, the proposed method can achieve an overall accuracy (OA) of 88.80% and 66.90% on the three- and five-category dual-pol OpenSARShip datasets, which outperforms the state-of-the-art methods by at least 2.00% and 2.37%, respectively.

Abstract:Ship detection in synthetic aperture radar (SAR) images is a hot pot. However, most existing convolution neural network (CNN)-based research is limited to single polarization ship detection and neglects the utilize of the rich polarization information to further improve detection performance. Thus, to address the problem, in this paper, a group-wise shuffle attention R-CNN (GWSA R-CNN) is proposed for ship detection in dual-polarization SAR images. Based on the raw Faster R-CNN, GWSA R-CNN embeds a group-wise shuffle attention module (GWSA module) in the detection subnetwork to capture enriched organic fusion polarization information. Finally, the experimental results on the dual-polarization SAR ship detection dataset (DSSDD) show the state-of-the-art (SOTA) performance of our GWSA R-CNN, outperforming than other 7 competitive models. Specifically, GWSA R-CNN surpasses the second-best model 1.82% average precision (AP).

Abstract:This letter proposes a novel convolutional neural network (CNN) method for dual-polarized synthetic aperture radar (SAR) ship grained classification. The network employs hybrid channel feature loss that jointly utilizes the information contained in the polarized channels (VV and VH). It is demonstrated that, by adopting the proposed CNN framework and the novel loss function, the classification performance can be efficiently improved. First, instead of the prevalently used threefold or fourfold division (container ship, oil tanker, bulk carrier, and so on), the proposed method can further divide vessels into eight accurate categories. Second, this method can not only effectively classify targets into eight categories but also its accuracy in terms of fewer category classifications surpasses existing methods. Third, the method can achieve good performance on a small training data set. Experiments conducted on the OpenSARShip data sets indicate that the proposed classification method achieves state-of-the-art results.
On the Use of Polarization Phase Information for Ship Detection

Abstract:Fully polarimetric synthetic aperture radar (SAR) data has been found to have many potential marine applications. This paper investigates in the polarization phase information for ship detection using Space-borne Imaging Radar-C/X-band SAR (SIR-C/X-SAR) data. It is shown that there exits large difference in polarization phase between ships and sea surface. The HH-VV polarization phase difference has largest ship-sea contrast among all polarization phase differences. An algorithm for ship detection has been proposed based on the ship-sea contrast in polarization phase information. The results have indicated that the polarization phase difference information can be used to detect ships with high accuracy.

Abstract:For synthetic aperture radar (SAR), multipolarization and multifrequency modes greatly enrich the acquired earth resource information and have been widely applied in remote-sensing fields. In this article, we compare the classification capabilities of multipolarization and dual-frequency SAR. To meet the objective of selecting consistent and complete polarimetric information, a unified classification framework is proposed. In the framework, covariance matrices are used directly as inputs instead of polarimetric indicators. Additionally, the Wishart mixture model (WMM) is utilized to characterize the statistical distribution of polarimetric SAR data. Besides, the data log-likelihood function is utilized to mitigate the influence of the initial values on the expectation-maximization (EM) algorithm. Then, among the combinations of four sample-to-subclass distances and two schemes for obtaining sample-to-class distances, the one with the best classification performance is selected as the default for this framework. In the experiments, the classification capabilities of full polarization (FP), compact polarization (CP), and dual-polarization (DP) modes are first compared through the proposed classification framework. Then, we compare the classification capabilities of dual-frequency SAR in FP, CP, and DP modes. For polarimetric SAR (PolSAR) system design, it is necessary to strike a balance between demand indexes (classification performance, coverage width, and so on) and cost (such as budget, weight, and so on). The comparison results provide a reference for the optimization of polarization modes and frequency bands of the existing multipolarization and dual-frequency SAR payloads and the design of future SAR systems.
Cascaded Feature Fusion Pyramid Network for Ship Detection in Dualpolarization SAR Images

Abstract:Synthetic aperture radar (SAR) has been widely applied in maritime target detection. However, most existing SAR ship detection algorithms based on convolutional neural network (CNN) only use single polarization SAR images for detection, neglecting to further improve the detection performance by utilizing the rich polarization information of the SAR images. To deal with this issue, this paper proposes a Cascaded Feature Fusion Pyramid Network (CFFPN) for ship detection in dual-polarization SAR images. The CFFPN builds a cascaded feature fusion module (CFFM) to fuse the enriched polarization information in SAR images. Extensive evaluations conducted on the the dual-polarization SAR ship detection dataset showcase the remarkable effectiveness of CFFPN, achieving an average precision (AP) of 93.4%. This outperforms the other five competitive methods. Notably, CFFPN exhibits a notable improvement of 1.3% in AP compared to the second-best method.

Abstract:Polarimetric synthetic aperture radar (SAR) is currently drawing more attention due to its advantage in Earth observations, especially in ship detection. In order to establish a reliable feature selection method for marine vessel monitoring purposes, forty features are extracted via polarimetric decomposition in the full-polarimetric (FP), compact-polarimetric (CP), and dual-polarimetric (DP) modes. These features were comprehensively quantified and evaluated using the Euclidean distance and mutual information, and the result indicated that the features in CP SAR are better than those of FP or DP SAR in general. The CP SAR features are thus further studied, and a new feature, named phase factor, in CP SAR mode is presented that can distinguish ships and the sea surface by the constant 0 without complex calculation. Furthermore, the phase factor is independent of the sea surface roughness, and hence it performs stably for ship detection even in high sea states. Experiments demonstrated that the ship detection performance of the phase factor detector is better than that of roundness, delta, HESA and CFAR detectors in low, medium and high sea states.
Marine Target Detection Using Dual-polarimetric SAR Imagery

Abstract:In this study,we provide a summary of research advances in the field of maritime target detection using DP（ dualpolarimetric） SAR（ Synthetic Aperture Radar） imagery,accomplished during the European and China collaboration in the framework of the Dragon-4 program ID 32235. The main innovative contribution is twofold:（1） We addressed ship detection proposing an improved GP-PNF（ Geometrical Perturbation-Polarimetric Notch Filter）,termed as IGP-PNF,that is characterized by a new feature vector that includes three new scattering features;（2）We addressed oil platform detection by contrasting singlepolarization SAR methods with polarimetric ones in order to quantify the extra-benefit carried on polarimetric information. The proposed theoretical framework is tested against actual multi-polarization SAR data. In particular,ship detection methods are verified against a Sentinel-1 SAR scene where a large number of ships is present; while,oil platform detection is discussed using Terra SAR-X SAR data. Experimental analysis shows that:（1） The IGP-PNF method performs best in terms of clutter-to-target ratio;（2）Coherent polarimetric information significantly outperforms single-polarization SAR measurements in highlighting targets in challenging cases.

Abstract:For polarimetric synthetic aperture radar (PolSAR) data, the correlation of two polarization channels is sensitive to the target orientation relative to the sensor's illumination direction. In this letter, the concept of polarimetric correlation pattern is proposed to explore this scattering diversity. The core idea is to extend the polarimetric correlation from a fixed angle to the rotation domain along the radar line of sight. A set of new polarimetric features are derived, and three features with high target-to-clutter ratio (TCR) are selected for PolSAR ship detection. The proposed ship detection method mainly contains three steps: the features selection, thresholding procedure, and morphological filtering. Experimental studies with Radarsat-2 and GaoFen-3 data validate the advantage of the proposed approach, especially for inshore dense ship discrimination.

Feature-loss Double Fusion Siamese Network for Dual-polarized SAR Ship Classification

Abstract:In this paper, a feature-loss double fusion Siamese network (DFSN) is proposed for dual-polarized SAR ship classification. The proposed scheme includes two parts, a two-stream Siamese network (TSSN), and a novel fusion loss for TSSN. TSSN is used to fuse the complementary information between SAR images under different polarization modes. Fusion loss is designed to accelerate the convergence of the network while guaranting the high classification accuracy. Experiments result proves the effectiveness of our methods and the proposed scheme achieves a classification accuracy of 87.04% on the OpenSARship dataset.
Utilizing Polarization Diversity in GBSAR Data-Based Object Classification

Abstract:In recent years, the development of intelligent sensor systems has experienced remarkable growth, particularly in the domain of microwave and millimeter wave sensing, thanks to the increased availability of affordable hardware components. With the development of smart Ground-Based Synthetic Aperture Radar (GBSAR) system called GBSAR-Pi, we previously explored object classification applications based on raw radar data. Building upon this foundation, in this study, we analyze the potential of utilizing polarization information to improve the performance of deep learning models based on raw GBSAR data. The data are obtained with a GBSAR operating at 24 GHz with both vertical (VV) and horizontal (HH) polarization, resulting in two matrices (VV and HH) per observed scene. We present several approaches demonstrating the integration of such data into classification models based on a modified ResNet18 architecture. We also introduce a novel Siamese architecture tailored to accommodate the dual input radar data. The results indicate that a simple concatenation method is the most promising approach and underscore the importance of considering antenna polarization and merging strategies in deep learning applications based on radar data.

Abstract:Synthetic aperture radar (SAR) is considered being a good option for earth observation with its unique advantages. In this paper, we proposed an adaptive ship detector using full-polarization SAR images. First, by thoroughly investigating the scattering characteristics between ships and their background, and the wave polarization anisotropy, a novel ship detector is proposed by jointing the two characteristics, named Scattering-Anisotropy joint (joint-SA). Based on the theoretical analysis, we showed that the joint-SA is an effective physical quantity to show the difference between the ship and its background, and thus joint-SA can be used for ship detection of full-polarization image data. Second, the generalized Gamma distribution was used to characterize the joint-SA statistics of sea clutter with a large range of homogeneity. As a result, an adaptive constant false alarm rate (CFAR) method was implemented based on the joint-SA. Finally, RADARSAT-2 and GF-3 data in C-band and ALOS data in L-band are used for verification. We tested on five datasets, and the experimental results verify the correctness and superiority of the constant false alarm rate (CFAR) method based on the joint-SA. In addition, the experimental results also showed that the signal-clutter ratio (SCR) of the proposed ship detector joint-SA (33.17 dB, 35.98 dB, 57.25 dB) is better than that of DBSP (8.92 dB, 3.43 dB, 25.40 dB) and RsDVH (17.28 dB, 11.17 dB, 54.55 dB). More importantly, the proposed detector joint-SA has higher detection accuracy and a lower false alarm rate.

Abstract:A novel Dual-polarization SAR ship target recognition method based on feature and loss fusion deep network is proposed in this paper, to improve the generalization ability, the recognition accuracy of imbalance samples, and the real-time performance of the general deep learning network. The proposed combined network is composed of two parts. The first part is the target region extraction network based on lightweight mini Hourglass network, to eliminate the impact of data imbalance and background noise on the identification accuracy. The second part is a two-channel feature/loss function fusion network based on Efficient B2 backbone network, aiming to solve the problem of dual-polarization image feature fusion and iterative convergence acceleration. The proposed method is tested on SAR image ship slices from the OpenSAR data sets. The experimental results indicates that, the proposed method achieves a recognition rate of 110FPS with recognition accuracy of 87.72%, and exceeds the SOTA by recognition accuracy 3.72% with convergence speed improved by 75.68%. The proposed method can be applied to SAR target recognition with dual polarization, imbalance samples and low-resolution condition for reference.
