Abstract:Relating the Surface Electromyogram (sEMG) to joint angle is useful in various application areas, including exoskeletons control, ergonomics and clinical biomechanics. The angle of the wrist is an important command of the device of the upper limb. The most simple and intuitive way to introduce proportional control of the upper-limb, is to use estimated angles directly as control output signal. Estimation accuracy is affected by many factors, such as torque, tribological effect of electrode and the skin friction, electrode position and so on. In this work an attempt is made to improve the accuracy by changing the rotating torque and elbow positions. The regression analysis between wrist angle and sEMG at dynamic muscle activity in normal subjects were investigated with the backpropagation neural network. Then, the two factors analysis of variance for repeated measures was used to assess the quality of regression. The goal of this study was to evaluate the feasibility of predicting dynamic arm movements (pronation/supination) based on sEMG signals from four muscles. The main contribution of this study is that it is important to take into account the effect of torque and gestures change on the performance of proportional control by the sEMG. These results suggest that it is possible to improve the system's robustness by changing the two factors.
A Novel Exoskeleton Neuromuscular Interface Based on Motor Unit Action Potential Model Using High-Density Semg

Abstract:The topical and noninvasive measurement of high-density surface electromyogram (HD-sEMG) signals enables the estimation of human motor unit action potentials (MUAPs) as crucial motor function indicators for human-robot interaction. In this paper, we present a two-dimensional (2D) high-density microneedle electrode array using the potassium hydroxide (KOH) bulk etching technique and the flexible printed circuit (FPC). To determine the optimal configuration of the 2D electrode array, we propose an accurate and efficient neuromuscular analytical model for HD-sEMG that comprehensively analyzes the effects of the micro-needle electrode size, inter-electrode distance, and location. The experiment was conducted to demonstrate the feasibility and performance of the proposed micro-needle-based high-density electrode array for the sEMG-based upper-limb exoskeleton’s elbow joint angle estimation, specifically in comparison with a commercial wet electrode. The experimental results showed that the proposed micro-needle electrode with high spatial resolution was comparable to the wet electrode (Wilcoxon rank sum test, p > 0:05). On average, the correlation and root mean squared error (RMSE) of the micro-needle electrode array with high space utilization were 7:56% and 19:83% better than those of the wet electrode, respectively. The 2D high-density micro-needle electrode array based on the proposed HD-sEMG model facilitates a novel neural-machine interface for intuitive control of upper-limb exoskeletons.

Abstract:Gesture recognition in non-intrusive muscle-computer interfaces is usually based on windowed descriptive and discriminatory surface electromyography (sEMG) features because the recorded amplitude of a myoelectric signal may rapidly fluctuate between voltages above and below zero. Here, we present that the patterns inside the instantaneous values of high-density sEMG enables gesture recognition to be performed merely with sEMG signals at a specific instant. We introduce the concept of an sEMG image spatially composed from high-density sEMG and verify our findings from a computational perspective with experiments on gesture recognition based on sEMG images with a classification scheme of a deep convolutional network. Without any windowed features, the resultant recognition accuracy of an 8-gesture within-subject test reached 89.3% on a single frame of sEMG image and reached 99.0% using simple majority voting over 40 frames with a 1,000 Hz sampling rate. Experiments on the recognition of 52 gestures of NinaPro database and 27 gestures of CSL-HDEMG database also validated that our approach outperforms state-of-the-arts methods. Our findings are a starting point for the development of more fluid and natural muscle-computer interfaces with very little observational latency. For example, active prostheses and exoskeletons based on high-density electrodes could be controlled with instantaneous responses.
A Novel Myoelectric Control Scheme Supporting Synchronous Gesture Recognition and Muscle Force Estimation

Abstract:Aiming to provide feasible solutions for the realization of the robust and natural myoelectric control systems, a novel myoelectric control scheme supporting gesture recognition and muscle force estimation is proposed in this study. Eleven grasping gestures abstracted from daily life are selected as the target gesture set. The high-density surface electromyography (HD-sEMG) of the forearm flexor and the grasping force signal are collected simultaneously. The synchronous prediction of gesture category and instantaneous force is realized by the multi-task learning (MTL) technique. Especially, a post-processing algorithm based on threshold method is conducted to overcome the influence of force variation on the accuracy of gesture recognition. The experimental results show that the proposed post-processing method can decrease the classification error significantly. Specifically, the overall gesture classification error is reduced by 27 ~ 30 percent compared with not using the post-processing method; and 16 ~ 24 percent compared with using classical post-processing methods. The whole scheme can realize the synchronous gesture recognition and force estimation with 9.35 ± 11.48% gesture classification error and 0.1479 ± 0.0436 root-mean-square deviation force estimation accuracy. Meanwhile, it is feasible in different number of electrodes and well meets the real-time requirement of the EMG control system in response time delay (about 28.22 ~ 113.16ms on average). The proposed framework provides the possibility for myoelectric control supporting synchronous gesture recognition and force estimation, which can be extended and applied in the fields of myoelectric prosthesis and exoskeleton devices.

Abstract:Surface electromyogram-based pattern recognition (sEMG-PR) has been considered as the most promising method to control multifunctional prostheses for decades. However, the commercial applications of sEMG-PR in prosthetic control is still limited due to the ambient noise and impedance variation between electrodes and skin surface. In order to reduce these issues, a force-myography-based pattern recognition method was proposed. In this method, a type of polymer-based flexible film sensors, the piezoelectrets, were used to record the rate of stress change (RSC) signals on the muscle surface of eight able-bodied subjects for six hand motions. Thirteen time domain features and four classification algorithms of linear discriminant analysis (LDA), K-nearest neighbor (KNN), artificial neural network (ANN), and support vector machine (SVM) were adopted to decode the RSC signals of different motion classes. In addition, the optimal feature set, classifier, and analysis window length were investigated systematically. Results showed that the average classification accuracy was 95.5 ± 2.2% by using the feature combination of root mean square (RMS) and waveform length (WL) for the classifier of KNN, and the analysis window length of 300 ms was found to obtain the best classification performance. Moreover, the robustness of the proposed method was investigated, and the classification accuracies were observed above 90% even when the white noise ratio increased to 50%. The work of this study demonstrated the effectiveness of RSC-based pattern recognition method for motion classification, and it would provide an alternative approach for the control of multifunctional prostheses.

Abstract:Robust classification of natural hand grasp type based on electromyography (EMG) still has some shortcomings in the practical prosthetic hand control, owing to the influence of dynamic arm position changing during hand actions. This study provided a framework for robust hand grasp type classification during dynamic arm position changes, improving both the "hardware" and "algorithm" components. In the hardware aspect, co-located synchronous EMG and force myography (FMG) signals are adopted as the multi-modal strategy. In the algorithm aspect, a sequential decision algorithm is proposed by combining the RNN-based deep learning model with a knowledge-based post-processing model. Experimental results showed that the classification accuracy of multi-modal EMG-FMG signals was increased by more than 10% compared with the EMG-only signal. Moreover, the classification accuracy of the proposed sequential decision algorithm improved the accuracy by more than 4% compared with other baseline models when using both EMG and FMG signals.

Abstract:Objective. To realize accurate muscle force estimation, a novel framework is proposed in this paper which can extract the input of the prediction model from the appropriate activation area of the skeletal muscle. Approach. Surface electromyographic (sEMG) signals from the biceps brachii muscle during isometric elbow flexion were collected with a high-density (HD) electrode grid (128 channels) and the external force at three contraction levels was measured at the wrist synchronously. The sEMG envelope matrix was factorized into a matrix of basis vectors with each column representing an activation pattern and a matrix of time-varying coefficients by a nonnegative matrix factorization (NMF) algorithm. The activation pattern with the highest activation intensity, which was defined as the sum of the absolute values of the time-varying coefficient curve, was considered as the major activation pattern, and its channels with high weighting factors were selected to extract the input activation signal of a force estimation model based on the polynomial fitting technique. Main results. Compared with conventional methods using the whole channels of the grid, the proposed method could significantly improve the quality of force estimation and reduce the electrode number. Significance. The proposed method provides a way to find proper electrode placement for force estimation, which can be further employed in muscle heterogeneity analysis, myoelectric prostheses and the control of exoskeleton devices.
Multipoint surface electromyography measurement using bull's-eye electrodes for wide-area topographic analysis

However, using a broader approach can enable simultaneous measurement of multiple muscles, which is essential for understanding muscular coordination. Using the "bull's-eye electrode," which allows bipolar derivation without directional dependence, enables wide-area multipoint sEMG measurements. This study aims to establish a multipoint measurement system and demonstrate its effectiveness and evaluates forearm fatigue and created topographic maps during a grasping task. Methods: Nine healthy adults with no recent arm injuries or illnesses participated in this study. They performed grasping tasks using their dominant hand, while bull's-eye electrodes recorded their muscle activity. To validate the effectiveness of the system, we calculated the root mean squares of muscle activity and entropy, an indicator of muscle activity distribution, and compared them over time. Results: The entropy analysis demonstrated a significant time-course effect with increased entropy over time, suggesting increased forearm muscle uniformity, which is possibly indicative of fatigue. Topographic maps visually displayed muscle activity, revealing notable intersubject variations. Discussion: Bull's-eye electrodes facilitated the capture of nine homogeneous muscle activity points, enabling the creation of topographic images. The entropy increased progressively, suggesting an adaptive muscle coordination response to fatigue. Despite some limitations, such as inadequate measurement of the forearm muscles' belly, the system is an unconventional measurement method. Conclusion: This study established a robust system for wide-area multipoint sEMG measurements using a bull's-eye electrode setup. This system effectively evaluates muscle fatigue and provides a comprehensive topographic view of muscle activity. These results mark a significant step towards developing a future multichannel sEMG system with enhanced measurement points and improved wearability. New Channel Merging Methods for Multi-DoF Force Prediction of Finger Contractions

Abstract:Surface electromyography (sEMG) signal is one of the widely applied biological signals in the research field of the force intention prediction. However, due to the severe crosstalk issue of sEMG signals during fine hand contractions, few studies have related sEMG to multiple degree-of-freedom (DoF) force prediction of individual fingers. Accordingly, this pilot study proposed two methodsCommon Spatial Pattern (CSP) and Softmax function to solve the cross-talk issues for the estimation of EMG-force during multiple finger contractions through weighting the significance of each selected channel. High-density sEMG signals of forearm extensor muscles were obtained, and experimental data from two able-bodied subjects were analyzed. Subjects produced 1-DoF and 3-DoF forces up to 30% maximum voluntary contraction (MVC). Then, the root-mean-square values of sEMG were related to joint force. Linear EMG-force models were trained using 1-DoF trials, then tested on 3-DoF trials. Our results showed that the proposed two novel methods had lower RMS errors than the traditional methods for index, and ring with little fingers. The results suggest that 3-DoF control for individual fingers with minimal training procedure (1-DoF trials) may be feasible for practical use.

Abstract:Physiological muscle disorders resulting from various diseases, such as sarcopenia or strokes, affect millions of people each year according to the American Heart Association. Medical examinations for assessing muscle health are difficult to administer and lack standardization. Surface electromyography (sEMG) signals have found a wide variety of applications; in this work, we present a simple reliable framework for hand grip force estimation using them. We hope that this work will lay the groundwork for applying hand grip force estimation as a method for standardized and reliable muscle health assessment. Seven healthy male subjects were voluntarily recruited and sEMG signals were collected from eight electrodes uniformly distributed around the forearm. A logarithmic function can describe the EMG–force relationship. We propose a novel method for generating functional potential-based inverse EMG images of the forearm. The hand grip force can be estimated from the reconstructed images. Using a simple lightweight system and simple algorithmic techniques we can attain a mean correlation coefficient of 0.95 ± 0.01 and mean RMSE of 0.18 ± 0.08 N . The results are presented for subject-dependent tests, the generalizability of the method is still to be researched over a larger cohort of subjects, including rehabilitation patients.

On Muscle Selection for EMG Based Decoding of Dexterous, In-Hand Manipulation Motions

Abstract:The field of Brain Machine Interfaces (BMI) has attracted an increased interest due to its multiple applications in the health and entertainment domains. A BMI enables a direct interface between the brain and machines and is capable of translating neuronal information into meaningful actions (e.g., Electromyography based control of a prosthetic hand). One of the biggest challenges in developing a surface Electromyography (sEMG) based interface is the selection of the right muscles for the execution of a desired task. In this work, we investigate optimal muscle selections for sEMG based decoding of dexterous in-hand manipulation motions. To do that, we use EMG signals derived from 14 muscle sites of interest (7 on the hand and 7 on the forearm) and an optical motion capture system that records the object motion. The regression problem is formulated using the Random Forests methodology that is based on decision trees. Regarding features selection, we use the following time-domain features: root mean square, waveform length and zero crossings. A 5-fold cross validation procedure is used for model assessment purposes and the importance values are calculated for each feature. This pilot study shows that the muscles of the hand contribute more than the muscles of the forearm to the execution of inhand manipulation tasks and that the myoelectric activations of the hand muscles provide better estimation accuracies for the decoding of manipulation motions. These outcomes suggest that the loss of the hand muscles in certain amputations limits the amputees' ability to perform a dexterous, EMG based control of a prosthesis in manipulation tasks. The results discussed can also be used for improving the efficiency and intuitiveness of EMG based interfaces for healthy subjects.
Classification of Human Hand Movements Using Surface EMG for Myoelectric Control.

Abstract:Surface electromyogram (sEMG) is a bioelectric signal that can be captured non-invasively by placing electrodes on the human skin. The sEMG is capable of representing the action intent of nearby muscles. The research of myoelectric control using sEMG has been primarily driven by the potential to create human-machine interfaces which respond to users intentions intuitively. However, it is one of the major gaps between research and commercial applications that there are rarely robust simultaneous control schemes. This paper proposes one classification method and a potential real-time control scheme. Four machine learning classifiers have been tested and compared to find the best configuration for different potential applications, and non-negative matrix factorisation has been used as a pre-processing tool for performance improvement. This control scheme achieves its highest accuracy when it is adapted to a single user at a time. It can identify intact subjects hand movements with above 98% precision and 91% upwards for amputees but takes double the amount of time for decision-making.
Adaptive Electrode Calibration Method Based on Muscle Core Activation Regions and Its Application in Myoelectric Pattern Recognition

Abstract:To reduce the bad effect of electrode shifts on myoelectric pattern recognition, this paper presents an adaptive electrode calibration method based on core activation regions of muscles. In the proposed method, the high-density surface electromyography (HD-sEMG) matrix collected during hand gesture execution is decomposed into source signal matrix and mixed coefficient matrix by fast independent component analysis algorithm firstly. The mixed coefficient vector whose source signal has the largest two-norm energy is selected as the major pattern, and core activation region of muscles is extracted by traversing the major pattern periodically using a sliding window. The electrode calibration is realized by aligning the core activation regions in unsupervised way. Gestural HD-sEMG data collection experiments with known and unknown electrode shifts are carried out on 9 gestures and 11 participants. A CNN+LSTM-based network is constructed and two network training strategies are adopted for the recognition task. The experimental results demonstrate the effectiveness of the proposed method in mitigating the bad effect of electrode shifts on gesture recognition accuracy and the potentials in reducing user training burden of myoelectric control systems. With the proposed electrode calibration method, the overall gesture recognition accuracies increase about (5.72~7.69)%. In specific, the average recognition accuracy increases (13.32~17.30)% when using only one batch of data in data diversity strategy, and increases (12.01~13.75)% when using only one repetition of each gesture in model update strategy. The proposed electrode calibration algorithm can be extended and applied to improve the robustness of myoelectric control system.

Abstract:Estimation of muscle contraction force based on the macroscopic feature of surface electromyography (SEMG) has been widely reported, but the use of microscopic neural drive information has not been thoroughly investigated. In this study, a novel method is proposed to process individual motor unit (MU) activities (firing sequences and action potential waveforms) derived from the decomposition of high density SEMG (HD-SEMG), and it is applied to muscle force estimation. In the proposed method, a supervised machine learning approach was conducted to determine the twitch force of each MU according to its action potential waveforms, which enables separate calculation of every MU's contribution to force. Thus, the muscle force was predicted through a physiologically meaningful muscle force model. In the experiment, HD-SEMG data were recorded from the abductor pollicis brevis muscles of eight healthy subjects during their performance of thumb abduction with the force increasing gradually from zero to four force levels (10%, 20%, 30%, 40% of the maximal voluntary contraction), while the true muscle force was measured simultaneously. When the proposed method was used, the root mean square difference (RMSD) of the error of the estimated force with respect to the measured force was reported to be 8.3% ± 2.8%. The proposed method also significantly outperformed the other four common methods for force estimation (RMSD: from 11.7% to 20%, ${p} < 0.001$ ), demonstrating its effectiveness. This study offers a useful tool for exploiting the neural drive information towards muscle force estimation with improved precision. The proposed method has wide applications in precise motor control, sport and rehabilitati-n medicine.

Abstract:Movement recognition based on surface electromyography is the foundation of myoelectric prosthesis control.Individual difference and pattern identification rate of SEMG are the two problems that researchers must face to.Based on the spectrum characteristic of SEMG,a new feature extraction method called Power Spectrum Ratio Method was proposed.The method defines the ratio of maximum energy band spectrum to total power spectrum as an eigenvalue of SEMG,which decreases the individual difference effect to the lowest.A mode classifier was used for hand movement pattern recognition,which adopts the special designed Bayes statistics algorithm.When used in hand movement pattern recognition for no-specific person,this method reached a correctness of 84%,which is rather practical.

Abstract:<span>Patients suffering from upper limb amputation experience a significant reduction in their ability to perform various tasks. The currently available myoelectric prostheses seek to reinstate the lost abilities of the amputees. However, most users abandon their devices due to high cost, large size, heavy weight, complexity, and limited functional control. This paper presents a multifunctional prosthetic hand that can perform six hand activities deploying a single-channel surface electromyography (sEMG) sensor. EMG signals for fifteen subjects (five amputees and ten intact) were acquired for six contraction levels of forearm muscles using the designed sensor. These levels were further classified to recognize six predefined hand gestures by a fuzzy logic classifier. The proposed system showed an excellent success (> 95%) and other performance parameters above 96%. The intended classification-based control scheme was further realized in real-time to achieve six grip patterns for the developed prosthetic prototype. The hand was tested on five subjects (two amputees and three intact) showed a percentage of success above 91% for accomplishing the dexterous grasping operations. The proposed approach is modest, efficient, and provides a low-cost solution to amputees with multiple degrees of freedom with a single channel EMG system.</span>

Towards semi-supervised myoelectric finger motion recognition based on spatial motor units activation

Abstract:It is vital to recognize the intention of finger motions for human-machine interaction (HMI). The latest research focuses on fine myoelectric control through the decoding of neural motor unit action potential trains (MUAPt) from high-density surface electromyographic (sEMG) signals. However, the existing EMG decoding algorithms rarely obtain the spatial matching relationship between decoded motion units (MU) and designated muscles, and the control interface can only recognize the trained hand gestures. In this study, a semi-supervised HMI based on MU-muscle matching (MMM) is proposed to recognize individual finger motions and even the untrained combined multi-finger actions Through automatic channel selection from high-density sEMG signals, the optimal spatial positions to monitor the MU activation of finger muscles are determined. Finger tapping experiment is carried out on ten subjects, and the experimental results show that the proposed sEMG decomposition algorithm based on MMM can accurately identify single finger motions with an accuracy of 93.1%±1.4%, which is comparable to that of state-of-the-art pattern recognition methods. Furthermore, the MMM allows unsupervised recognizing the untrained combined multi-finger motions with an accuracy of 73%±3.8%. The outcomes of this study benefit the practical applications of HMI, such as controlling prosthetic hand and virtual keyboard.

Abstract:A power-assisted exoskeleton robot can provide its operator a comfortable and natural motion assistance, which requires a perfect human-machine cooperative motion control algorithm according to the operator's intentions. As a bioelectrical signal, surface electromyography (sEMG) has the advantage of real-time for motion control, but its accuracy and reliability are still low due to strong ambiguity and coupling. So interactive force signal is still the most reliable and stable method as the control signal source for human motion intention detection. In this study, a gasbag-based human-machine interaction force signal detection method is proposed, which is combined with bioelectrical signals to identify human motion intentions and take full advantage of the two different control signal sources. A gasbag interactive force detection device is designed to monitor the internal pressure of the gasbag in real time with a pressure sensor, and the signal is converted to an interactive force by a pre-calibrated human- machine interaction force model. The interactive force is fused with the sEMG, the joint angular displacement, and the internal pressure of the pneumatic muscle, then the movement intention of the operator is obtained based on the logistic regression algorithm. Experimental results show that the method for human motion intention recognition has the characters of fast response, accurate recognition and stability.
A Current-Based Surface Electromyography (semg) System for Human Motion Recognition: Preliminary Study

Abstract:The myoelectric interface acts as an important role in the field of wearable robotics. This study explores the current-based sEMG technology for upper-limb motion recognition. Different from the voltage-based sEMG system, the current-based sampling approach can directly extract the current signals and be free from the cross talks. The technology facilitate the myoelectric sampling in a non-ideal environment such as underwater. We designed the sensing circuit with a feedback-loop current amplification module, and analyzed the stability. After development of the system, three healthy subjects participated in the experiment. Six basic wrist joint motions were investigated. With the selected feature set and the designed classification method, The average recognition accuracies across the subjects were 96.3%, 94.2%, and 95.8% respectively. The preliminary results demonstrate that the current-based sEMG technology is a promising solution to upper-limb motion recognition in a rigorous environment.
