Abstract:In this paper, we propose to extend the recently introduced model-agnostic meta-learning algorithm (MAML, Finn, et al., 2017) for low-resource neural machine translation (NMT). We frame low-resource translation as a meta-learning problem where we learn to adapt to low-resource languages based on multilingual high-resource language tasks. We use the universal lexical representation (Gu et al., 2018b) to overcome the input-output mismatch across different languages. We evaluate the proposed meta-learning strategy using eighteen European languages (Bg, Cs, Da, De, El, Es, Et, Fr, Hu, It, Lt, Nl, Pl, Pt, Sk, Sl, Sv and Ru) as source tasks and five diverse languages (Ro,Lv, Fi, Tr and Ko) as target tasks. We show that the proposed approach significantly outperforms the multilingual, transfer learning based approach (Zoph et al., 2016) and enables us to train a competitive NMT system with only a fraction of training examples. For instance, the proposed approach can achieve as high as 22.04 BLEU on Romanian-English WMT’16 by seeing only 16,000 translated words (~600 parallel sentences)
Low-Resource Neural Machine Translation Using Fast Meta-learning Method.

Abstract:Data sparsity is fundamental reason that affects the quality of low-resource neural machine translation models (NMT), although transfer learning methods can alleviate data sparsity by introducing external knowledge. However, the pre-trained model parameters are only suitable for the current task set, which does not ensure better performance improvement in downstream tasks. Although meta-learning methods have better potential, while meta-parameters are determined by the second-order gradient term corresponding to a specific task, which directly leads to the consumption of computing resources. In addition, the integration and unified representation of external knowledge is also the main factor to improve performance. Therefore, we proposed a fast meta-learning method using multiple-aligned word embedding representation, which can map all languages to the word embedding space of the target language without seed dictionary. Meanwhile, we update the meta-parameters by calculating the cumulative gradient on different tasks to replace the second-order term in the ordinary meta-learning method, which not only pays attention to the potential but also improves the calculation efficiency. We conducted experiments on three low-resource translation tasks of the CCMT2019 data set and found that our method significantly improves the model quality compared with traditional methods, which fully reflects the effectiveness of the proposed method.

Abstract:Meta-learning has been sufficiently validated to be beneficial for low-resource neural machine translation (NMT). However, we find that meta-trained NMT fails to improve the translation performance of the domain unseen at the meta-training stage. In this paper, we aim to alleviate this issue by proposing a novel meta-curriculum learning for domain adaptation in NMT. During meta-training, the NMT first learns the similar curricula from each domain to avoid falling into a bad local optimum early, and finally learns the curricula of individualities to improve the model robustness for learning domain-specific knowledge. Experimental results on 10 different low-resource domains show that meta-curriculum learning can improve the translation performance of both familiar and unfamiliar domains. Abstract:Multilingual transfer learning has been proved an effective method to solve the problem of low-resource neural machine translation (NMT). However, the global optimal parameters obtained through transfer learning can not effectively adapt to new tasks, which means the problem of local optimum will be caused when training the new task model. Although this problem can be alleviated by optimization-based meta-learning methods, but meta-parameters are determined by the second-order gradient term corresponding to the model parameters of a specific task, which consumes a lot of computing resources. Therefore, we proposed improved reptile meta-learning method. First, a multilingual unified word embedding method is proposed to represent multilingual knowledge. Secondly, the direction of meta-gradient is guided by calculating cumulative gradients on multiple specific tasks. In addition, the midpoint is taken as the meta-parameter in the space of the initial meta-parameter and the final task-specific model parameter to ensure that the meta-model has better multi-feature generalization ability. We conducted experiments in the CCMT2019 Mongolian-Chinese (Mo-Zh), Uyghur-Chinese (Uy-Zh) and Tibetan-Chinese (Ti-Zh), and the results show that our method has significantly improved the translation quality compared with the traditional methods.
Good Meta-tasks Make A Better Cross-lingual Meta-transfer Learning for Low-resource Languages.

Abstract:Model-agnostic meta-learning has garnered attention as a promising technique for enhancing few-shot cross-lingual transfer learning in low-resource scenarios. However, little attention was paid to the impact of data selection strategies on this cross-lingual meta-transfer method, particularly the sampling of cross-lingual meta-training data (i.e. meta-tasks) at the syntactic level to reduce language gaps. In this paper, we propose a Meta-Task Collector-based Cross-lingual Meta-Transfer framework (MeTaCo-XMT) to adapt different data selection strategies to construct meta-tasks for meta-transfer learning. Syntactic differences have an effect on transfer performance, so we consider a syntactic similarity sampling strategy and propose a syntactic distance metric model consisting of a syntactic encoder block based on the pre-trained model and a distance metric block using Word Move’s Distance (WMD). Additionally, we conduct experiments with three different data selection strategies to instantiate our framework and analyze their performance impact. Experimental results on two multilingual NLP datasets, Wikiann and TydiQA, demonstrate the significant superiority of our approach compared to existing strong baselines.

Abstract:Neural Machine Translation (NMT) systems built on multilingual sequence-to-sequence Language Models (msLMs) fail to deliver expected results when the amount of parallel data for a language, as well as the language's representation in the model are limited. This restricts the capabilities of domain-specific NMT systems for low-resource languages (LRLs). As a solution, parallel data from auxiliary domains can be used either to fine-tune or to further pre-train the msLM. We present an evaluation of the effectiveness of these two techniques in the context of domain-specific LRL-NMT. We also explore the impact of domain divergence on NMT model performance. We recommend several strategies for utilizing auxiliary parallel data in building domain-specific NMT models for LRLs.

Abstract:As a data-driven approach, neural machine translation (NMT) heavily depends on large parallel corpora. Nevertheless, such corpora are frequently unavailable in domains of user interest, consequently diminishing the performance of NMT models in terms of domain robustness and adaptability. To tackle this challenge, this paper presents an innovative training method for multi-domain translation that leverages meta-curriculum learning and terminology information. To utilize domain-specific terminology, the proposed method first need to extract, align, and filter terms, thereby integrating bilingual terminology into the training dataset. Following this, the aligned sentences are sorted according to the domain similarity scores with the general domain in a curriculum learning manner. Then, the training data is divided into sub-datasets in ascending order of difficulty. A meta-learning technique is then employed to train the model utilizing these partitioned training datasets as tasks, ultimately yielding a translation model with exceptional domain robustness and remarkable domain adaptability. Experimental results on test data from both seen and unseen domains demonstrate that the proposed method yields an average improvement of 2.44 in BLEU scores on the test sets of multiple domains compared to the pre-training and fine-tuning method, and a 1.54 BLEU scores increase over the meta-curriculum learning approach without terminology information. Upon fine-tuning with a small amount of target domain data, the proposed method outperforms these two baselines by 2.62 and 1.5 in BLEU scores, respectively. These outcomes underscore the efficacy of the proposed method in improving NMT performance in scenarios with limited domain-specific data.

Abstract:We consider two problems of NMT domain adaptation using meta-learning. First, we want to reach domain robustness, i.e., we want to reach high quality on both domains seen in the training data and unseen domains. Second, we want our systems to be adaptive, i.e., making it possible to finetune systems with just hundreds of in-domain parallel sentences. We study the domain adaptability of meta-learning when improving the domain robustness of the model. In this paper, we propose a novel approach, RMLNMT (Robust Meta-Learning Framework for Neural Machine Translation Domain Adaptation), which improves the robustness of existing meta-learning models. More specifically, we show how to use a domain classifier in curriculum learning and we integrate the word-level domain mixing model into the meta-learning framework with a balanced sampling strategy. Experiments on English$\rightarrow$German and English$\rightarrow$Chinese translation show that RMLNMT improves in terms of both domain robustness and domain adaptability in seen and unseen domains. Abstract:Abstract The utilization of monolingual data has been shown to be a promising strategy for addressing low-resource machine translation problems. Previous studies have demonstrated the effectiveness of techniques such as Back-Translation and self-supervised objectives, including Masked Language Modeling, Causal Language Modeling, and Denoise Autoencoding, in improving the performance of machine translation models. However, the manner in which these methods contribute to the success of machine translation tasks and how they can be effectively combined remains an under-researched area. In this study, we carry out a systematic investigation of the effects of these techniques on linguistic properties through the use of probing tasks, including source language comprehension, bilingual word alignment, and translation fluency. We further evaluate the impact of Pre-Training, Back-Translation, and Multi-Task Learning on bitexts of varying sizes. Our findings inform the design of more effective pipelines for leveraging monolingual data in extremely low-resource and low-resource machine translation tasks. Experiment results show consistent performance gains in seven translation directions, which provide further support for our conclusions and understanding of the role of monolingual data in machine translation.

Abstract:Neural machine translation (NMT) systems fall short when training data is insufficient. For low-resource domain adaptation, meta-learning has proven to be an effective training scheme. It aims to find an optimal initialization that is easily adaptable to new domains. However, it is assumed that samples contribute equally in tasks and tasks contribute equally in the training task distribution, which deteriorates the performance of the meta-model. In the inner loop, we propose the dynamic tuning strategy to distinguish the tasks' adapting abilities and weight the loss according to the representativeness to discriminate tasks from the same domain. In the outer loop, to measure effects of each task on meta parameters, we calculate uncertainty-aware confidence and assign weights on meta-updating steps. Experiments show that the proposed approaches gain stable improvements in all domains (+1.35 BLEU points in maximum). We also analyze the ability of our strategies to alleviate domain imbalance in non-ideal settings.
Large Language Model for Multi-Domain Translation: Benchmarking and Domain CoT Fine-tuning

Abstract:Achieving consistent high-quality machine translation (MT) across diverse domains remains a significant challenge, primarily due to the limited and imbalanced parallel training data available in various domains. While large language models (LLMs) have demonstrated impressive general understanding and generation abilities, their potential in multi-domain MT is under-explored. We establish a comprehensive benchmark for multi-domain translation, featuring 25 German$\Leftrightarrow$English and 22 Chinese$\Leftrightarrow$English test sets respectively covering 15 domains. Our evaluation of prominent LLMs reveals a discernible performance gap against traditional MT systems, highlighting domain overfitting and catastrophic forgetting issues after fine-tuning on domain-limited corpora. To mitigate this, we propose a domain Chain of Thought (CoT) fine-tuning technique that utilizes the intrinsic multi-domain intelligence of LLMs to improve translation performance. This method inspires the LLM to perceive domain information from the source text, which then serves as a helpful hint to guide the translation process. Despite being trained on a small dataset of four domains, our CoT fine-tune approach achieves notable enhancements in translation accuracy and domain robustness than traditional fine-tuning, as evidenced by an average 1.53 BLEU score increase in over 20 German$\rightarrow$English distinct out-of-domain tests.

High-resource Language-specific Training for Multilingual Neural Machine Translation.

Abstract:Multilingual neural machine translation (MNMT) trained in multiple language pairs has attracted considerable attention due to fewer model parameters and lower training costs by sharing knowledge among multiple languages. Nonetheless, multilingual training is plagued by language interference degeneration in shared parameters because of the negative interference among different translation directions, especially on high-resource languages. In this paper, we propose the multilingual translation model with the high-resource language-specific training (HLT-MT) to alleviate the negative interference, which adopts the two-stage training with the language-specific selection mechanism. Specifically, we first train the multilingual model only with the high-resource pairs and select the language-specific modules at the top of the decoder to enhance the translation quality of high-resource directions. Next, the model is further trained on all available corpora to transfer knowledge from high-resource languages (HRLs) to low-resource languages (LRLs). Experimental results show that HLT-MT outperforms various strong baselines on WMT-10 and OPUS-100 benchmarks. Furthermore, the analytic experiments validate the effectiveness of our method in mitigating the negative interference in multilingual training.

Abstract:While NMT has achieved remarkable results in the last 5 years, production systems come with strict quality requirements in arbitrarily niche domains that are not always adequately covered by readily available parallel corpora. This is typically addressed by training domain specific models, using fine-tuning methods and some variation of back-translation on top of in-domain monolingual corpora. However, industrial practitioners can rarely afford to focus on a single domain. A far more typical scenario includes a set of closely related, yet succinctly different sub-domains. At <a class="link-external link-http" href="http://Booking.com" rel="external noopener nofollow">this http URL</a>, we need to translate property descriptions, user reviews, as well as messages, (for example those sent between a customer and an agent or property manager). An editor might need to translate articles across a set of different topics. An e-commerce platform would typically need to translate both the description of each item and the user generated content related to them. To this end, we propose MDT: a novel method to simultaneously fine-tune on several sub-domains by passing multidimensional sentence-level information to the model during training and inference. We show that MDT achieves results competitive to N specialist models each fine-tuned on a single constituent domain, while effectively serving all N sub-domains, therefore cutting development and maintenance costs by the same factor. Besides BLEU (industry standard automatic evaluation metric known to only weakly correlate with human judgement) we also report rigorous human evaluation results for all models and sub-domains as well as specific examples that better contextualise the performance of each model in terms of adequacy and fluency. To facilitate further research, we plan to make the code available upon acceptance.

Abstract:Despite impressive empirical successes of neural machine translation (NMT) on standard benchmarks, limited parallel data impedes the application of NMT models to many language pairs. Data augmentation methods such as back-translation make it possible to use monolingual data to help alleviate these issues, but back-translation itself fails in extreme low-resource scenarios, especially for syntactically divergent languages. In this paper, we propose a simple yet effective solution, whereby target-language sentences are re-ordered to match the order of the source and used as an additional source of training-time supervision. Experiments with simulated low-resource Japanese-to-English, and real low-resource Uyghur-to-English scenarios find significant improvements over other semi-supervised alternatives.

Abstract:Neural approaches have achieved state-of-the-art accuracy on machine translation but suffer from the high cost of collecting large scale parallel data. Thus, a lot of research has been conducted for neural machine translation (NMT) with very limited parallel data, i.e., the low-resource setting. In this paper, we provide a survey for low-resource NMT and classify related works into three categories according to the auxiliary data they used: (1) exploiting monolingual data of source and/or target languages, (2) exploiting data from auxiliary languages, and (3) exploiting multi-modal data. We hope that our survey can help researchers to better understand this field and inspire them to design better algorithms, and help industry practitioners to choose appropriate algorithms for their applications.
Exploiting monolingual data at scale for neural machine translation

Abstract:While target-side monolingual data has been proven to be very useful to improve neural machine translation (briefly, NMT) through back translation, source-side monolingual data is not well investigated. In this work, we study how to use both the source-side and target-side monolingual data for NMT, and propose an effective strategy leveraging both of them. First, we generate synthetic bitext by translating monolingual data from the two domains into the other domain using the models pretrained on genuine bitext. Next, a model is trained on a noised version of the concatenated synthetic bitext where each source sequence is randomly corrupted. Finally, the model is fine-tuned on the genuine bitext and a clean version of a subset of the synthetic bitext without adding any noise. Our approach achieves state-of-the-art results on WMT16, WMT17, WMT18 English↔ German translations and WMT19 German→ French translations, which demonstrate the effectiveness of our method. We also conduct a comprehensive study on how each part in the pipeline works.
Semantic Perception-Oriented Low-Resource Neural Machine Translation

Abstract:Pre-training method has been proved to significantly improve the performance of low-resource neural machine translation (NMT), while the common pre-training methods (BERT) uses attention mechanism based on Levenshtein distance (LD) to extract language features, which ignored syntax-related information. In this paper, we proposed a machine translation pre-training method with semantic perception which depend on the traditional position-based modeling, we uses semantic role labels (SRL) to annotate sentences with "predicate-argument" structures at the word level, and merge vectorized SRL with word vectors to deepen the model's understanding of deep semantics. In addition, to avoid parameter disaster, we proposed a hierarchical knowledge distillation method to fuse the NMT model and pre-training model to adapt to the output probability distribution of the pre-training model. We validated the method in the LDC En-Zh and CCMT2017 Mongolia-Chinese (Mo-Ch), Uyghur-Chinese (Uy-Ch), Tibetan-Chinese (Ti-Ch) tasks. The results show that compared with baseline, our model achieves significant results, which fully illustrates the generalization of the method.

Abstract:The Deep Learning method sits on the field of machine translation by virtue of its ability to understand semantics, especially in the field of large languages. However, for low-resource languages, a difficult problem is the lack of large-scale bilingual corpus which leads to over-fitting of the model. In this paper, for languages with few data resources, Round-Trip Translation(RTT) is combined to expand the scale of pseudo-parallel corpus, while dual learning method is used to semi-supervised the model in two directions: source-target language and target-source language, then the updating of model parameters is guided by reward feedback. In addition, in order to reduce the "noise" effect of pseudo-corpus, an iterative attenuation method is proposed to refine the training data. Then, the CWMT2018 Mongolian-Chinese translation task is used to test the model. The results show that the BLEU value of the model is 2.1 higher than that of the traditional method, and the validity of the method is fully proved.
