Abstract:Data-driven methods have emerged as a promising framework for material constitutive modeling. However, traditional data-driven models are hindered by limitations arising from a scarcity of datasets and the absence of explicit physical principles. These limitations lead to inadequate generalization capabilities and predictions that may contradict established physical laws. To overcome these challenges, this study introduces a thermodynamics-informed neural network (TINN) for elastoplastic constitutive modeling of granular materials. Following the thermodynamics-based elastoplastic theory, the TINN model incorporates elastic free energy, stored plastic work, and dissipation. It achieves this by integrating a path-dependent recurrent neural network (RNN) and three sub-fully connected neural networks to capture the mechanical response and energy evolution in sheared granular materials. The total loss function of TINN combines data-driven and physics-informed components. The effectiveness and generalization capabilities of TINN are evaluated by testing it on diverse datasets, including both simulated and experimental data. The simulated virtual data are derived either from an available elastoplastic model or via discrete element method (DEM) simulations employing stress probing techniques. The results highlight the superior generalization ability and robustness of the TINN model, surpassing purely data-driven models in performance and reliability.
Effects of Initial Static Shear on Undrained Cyclic Behavior of Granular Materials: Energy Evolution and Micromechanical Interpretation

Abstract:This paper presents a numerical investigation of the liquefaction behavior of granular materials considering the initial static shear effects. Two typical cyclic failure modes were identified: cyclic liquefaction and residual deformation accumulation. During the simulation processes, the evolution of the applied work, strain energy, frictional dissipation, and kinetic energy was examined and interpreted by the law of thermodynamics. The relative magnitudes of the applied work and dissipation were found to be significantly different for the two distinct cyclic failure modes. For cyclic liquefaction, the applied work was smaller than the frictional dissipation, accompanied by continuous liberation of the strain energy. In contrast, for residual deformation accumulation, the applied work was nearly the same as dissipation, and the strain energy appeared to be stable and periodically varying in each cycle, indicating the attainment of a steady internal structure and thus a strong resistance to liquefaction. These observations can be interpreted by correlating the energy transfer and dissipation with the contact-normal-based fabric evolution of the granular system at microscale.

Abstract:A numerical investigation on the behavior of granular materials subjected to the rotation of principal stresses using the discrete element method is presented. A numerical procedure is developed to implement the two-dimensional arbitrary stress or strain paths imposed on polygonal specimens. Significant volumetric strain can be obtained and granular assembly appears to develop an anisotropic internal structure characterized by the contact-normal-based fabric tensor in due course, with its direction being rotated with the rotation of the principal stress. The observations indicate a significant degree of non-coaxiality between the principal-stress direction and the principal-strain increment direction. An ultimate state can be reached after sufficiently large numbers of cycling, resulting in a constant fabric norm and a circular strain trajectory in the deviatoric space. The boundary work, dissipation, and strain energy, are also registered during the entire loading process and its correlation between non-coaxial deformations is analyzed from micro-scale perspective. Before the ultimate state is reached, the applied work is partially dissipated by frictional sliding, and the remainder is stored as the strain energy within the specimen. When the ultimate state is reached, however, no change in the strain energy is obtained, and the plastic work is entirely dissipated, as the elastic portion of the free energy increment only depends on the elastic strain.
Incremental behavior of granular soils: a strain response envelope perspective

Abstract:The mechanical behavior of granular materials is characterized by strong nonlinearity, which is known to be directly linked to the details of the underlying microstructure of contacts, or fabric. The incremental behavior in different loading directions can be obtained by performing a series of axisymmetric stress probing on the specimens. Since the macro- and micro-scale response in different loading directions cannot be obtained experimentally on the very same specimen, discrete element method is employed in the present study, and the stress probing tests on the Rendulic plane are carried out on the specimens of different stress histories, stress states and particle size distributions (PSD). Simulation results indicate that the classic plasticity theories are unable to describe all the observed features when the specimens have different stress histories. However, a linear correlation between the deviatoric strain and the deviatoric part of the contact-normal-based fabric can be obtained. For the specimens with the same relative density, only confining pressure is found to have a significant effect on the linear factor while the linear factor seems to be insensitive to the variation of the stress ratio, stress history and PSD. Since the anisotropy of sand and therefore the impact of stress histories can be characterized by the deviatoric part of the fabric tensor, these observations would provide the necessary micro-scale physical basis for the development of elasto-plastic incremental constitutive relations of granular soils.

Abstract:Granular elasticity, an elasticity theory useful for calculating static stress distribution in granular media, is generalized to the dynamic case by including the plastic contribution of the strain. A complete hydrodynamic theory is derived based on the hypothesis that granular medium turns transiently elastic when deformed. This theory includes both the true and the granular temperatures, and employs a free energy expression that encapsulates a full jamming phase diagram, in the space spanned by pressure, shear stress, density and granular temperature. For the special case of stationary granular temperatures, the derived hydrodynamic theory reduces to {\em hypoplasticity}, a state-of-the-art engineering model.

Abstract:SummaryIt is well known that soil is inherently anisotropic and its mechanical behavior is significantly influenced by its fabric anisotropy. Hypoplasticity is increasingly being accepted in the constitutive modeling for soils, in which many salient features, such as nonlinear stress‐strain relations, dilatancy, and critical state failure, can be described by a single tensorial equation. However, within the framework of hypoplasticity, modeling fabric anisotropy remains challenging, as the fabric and its evolution are often vaguely assumed without a sound basis. This paper presents a hypoplastic constitutive model for granular soils based on the newly developed anisotropic critical state theory, in which the conditions of fabric anisotropy are concurrently satisfied along with the traditional conditions at the critical state. A deviatoric fabric tensor is introduced into the Gudehus‐Bauer hypoplastic model, and a scalar‐valued anisotropic state variable signifying the interplay between the fabric and the stress state is used to characterize its impact on the dilatancy and strength of the soils. In addition, fabric evolution during shearing can explicitly be addressed. Modifications have also been undertaken to improve the performance of the undrained response of the model. The anisotropic hypoplastic model can simulate experimental tests for sand under various combinations of principle stress direction, intermediate principal stress (or mode of shearing), soil densities, and confining pressures, and the associated drastic effect of different principal stress orientations in reference to the material axes of anisotropy can be well captured.

Abstract:Although fully elastic when static, granular media become transiently elastic when being slowly sheared -- during which both the elastic energy and stress relax. Starting from this observation, we cogently derive the framework for granular hydrodynamics, a set of differential equations consistent with general principles of physics, especially reversible and irreversible thermodynamics. In addition, an expression for the granular elastic energy is reviewed and further discussed.

Abstract:Mesoscopic structures form in dense granular materials due to the self-organisation of the constituent particles. These structures have internal structural degrees of freedom in addition to the translational degree of freedom. The resultant granular elasticity, which exhibits intrinsic variations and inevitable relaxation, is a key quantity that accounts for macroscopic solid- or fluid-like properties and the transitions between them. In this work, we propose a potential energy landscape (PEL) with local stable basins and low elastic energy barriers to analyse the nature of granular elasticity. A function for the elastic energy density is proposed for stable states and is further calibrated with ultrasonic measurements. Fluctuations in the elastic energy due to the evolution of internal structures are proposed to describe a so-called configuration temperature T(c) as a counterpart of the classical kinetic granular temperature T(k) that is attributed to the translational degrees of freedom. The two granular temperatures are chosen as the state variables, and a fundamental equation is established to develop non-equilibrium thermodynamics for granular materials. Due to the relatively low elastic energy barrier in the PEL, granular elasticity relaxes more under common mechanical loadings, and a simple model based on mean-field theory is developed to account for this behaviour.

Abstract:The problems and limitations in constitutive theory of classical elastoplastic mechanics are discussed by analyzing constitutive models of geomaterials based on the constitutive theory.According to the principle of the modern continuum thermomechanics and the internal variable theory of the modern continuum mechanics,the physical meaning of the yield function in constitutive models of geomaterials and the relation between the yield function and the dissipation function are presented,and a new method to establish elastoplastic constitutive relation of geomaterials is proposed.With the method taken, the elastoplastic matrix of the incremental form of the constitutive equation is deduced,the increment equation of plastic strain is presented,and the generalized normality rule of elastoplastic coupling materials is proved.The problems,which are needed to be further studied,in establishing the elastoplastic constitutive relation of geomaterials by the internal variable theory,are also presented.

Abstract:The modeling of the elastic properties of granular or nanoscale systems requires the foundations of the theory of elasticity to be revisited, as one explores scales at which this theory may no longer hold. The only cases for which a microscopic justification of elasticity exists are (nearly) uniformly strained lattices. A microscopic theory of elasticity, as well as simulations, reveal that standard continuum elasticity applies only at sufficiently large scales (typically 100 particle diameters). Interestingly, force chains, which have been observed in experiments on granular systems, and attributed to non-elastic effects, are shown to exist in systems composed of harmonically interacting constituents. The corresponding stress field, which is a continuum mechanical (averaged) entity, exhibits no chain structures even at near-microscopic resolutions, but it does reflect macroscopic anisotropy, when present.

Abstract:A macroscopic elastic description of stresses in static, preloaded granular media is derived systematically from the microscopic elasticity of individual inter-grain contacts. The assumed preloaded state and friction at contacts ensure that the network of inter-grain contacts is not altered by small perturbations. The texture of this network, set by the preparation of the system, is encoded in second and fourth order fabric tensors. A small perturbation generates both normal and tangential inter-grain forces, the latter causing grains to reorient. This reorientation response and the incremental stress are expressed in terms of the macroscopic strain.

Abstract:Granular Solid Hydrodynamics (GSH) is a broad-ranged continual mechanical description of granular media capable of accounting for static stress distributions, yield phenomena, propagation and damping of elastic waves, the critical state, shear band, and fast dense flow. An important input of GSH is an expression for the elastic energy needed to deform the grains. The original expression, though useful and simple, has some draw-backs. Therefore, a slightly more complicated expression is proposed here that eliminates three of them: (1) The maximal angle at which an inclined layer of grains remains stable is increased from $26^\circ$ to the more realistic value of $30^\circ$. (2)Depending on direction and polarization, transverse elastic waves are known to propagate at slightly different velocities. The old expression neglects these differences, the new one successfully reproduces them. (3) Most importantly, the old expression contains only the Drucker-Prager yield surface. The new one contains in addition those named after Coulomb, Lade-Duncan and Matsuoka-Nakai -- realizing each, and interpolating between them, by shifting a single scalar parameter.

Abstract:Although the mechanical response of granular materials strongly depends on the interplay between their anisotropic internal structure (fabric) and loading direction, such coupling is not explicitly considered in existing high-cycle experimental datasets and models. High-cycle experiments on granular specimens specifically prepared with various fabric orientations are presented. It is found that the high-cycle strain accumulation behavior can change remarkably, from shakedown to ratcheting, when the fabric orientation deviates more from the loading direction. Inspired by the experimental observations, a fabric-dependent anisotropic high-cycle model is proposed, by proper recasting of an existing model formulated within Critical State Theory, into the framework of Anisotropic Critical State Theory. The model explicitly accounts for the fabric evolution, which is linked to plastic modulus, dilatancy and kinematic hardening rules. The model can quantitatively reproduce the high-cycle strain accumulation (i.e., shakedown and ratcheting) under drained conditions, as well as pre-liquefaction and post-liquefaction responses granular materials having widely ranged fabric anisotropy, densities and cyclic loading types using a unified set of constants. It exhibits a unique feature of simulating the distinct high-cycle strain accumulation and liquefaction of granular material with various fabric anisotropy, while the existing high-cycle models treat them equally. The successful reproduction of the anisotropic sand element response under high-cycle drained and undrained conditions makes it possible to perform whole life analysis of various foundations on granular soil subjected to high-cycle loading events.
On the Influence of Inter-Particle Friction and Dilatancy in Granular Materials: a Numerical Analysis

Abstract:Mechanical behavior of granular soils is a classic research realm but still yet not completely understood as it can be influenced by a large number of factors, including confining pressure, soil density, loading conditions, and anisotropy of soil etc. Traditionally granular materials are macroscopically regarded as continua and their particulate and discrete nature has not been thoroughly considered although many researches indicate the macro mechanical behavior closely depends on the micro-scale characteristics of particles. This paper presents a DEM (discrete element method)-based micromechanical investigation of inter-particle friction effects on the behavior of granular materials. In this study, biaxial DEM simulations are carried out under both ‘drained’ and ‘undrained’ (constant volume) conditions. The numerical experiments employ samples having similar initial isotropic fabric and density, and the same confining pressure, but with different inter-particle friction coefficient. Test results show that the inter-particle friction has a substantial effect on the stress-strain curve, peak strength and dilatancy characteristics of the granular assembly. Clearly, it is noted that apart from the inter-particle friction, the shear resistance is also contributed to the dilation and the particle packing and arrangements. The corresponding microstructure evolutions and variations in contact properties in the particulate level are also elaborated, to interpret the origin of the different macro-scale response due to variations in the inter-particle friction.

Abstract:We investigate, using a recently developed model of liquid state theory describing the rheology of dense granular flows, how a yield stress appears in granular matter at the yielding transition. Our model allows us to predict an analytical equation of the corresponding dynamical yield surface, which is compared to the usual models of solid fracture. In particular, this yield surface interpolates between the typical failure behaviors of soft and hard materials. Abstract:This study presents a novel constitutive model for granular soils within the framework of hyperplasticity theory. Based on fundamentally distinct mechanisms, two types of volume variations exist. The first type includes variations arising from changes in stress, accompanied by energy dissipation. The other type of variations is purely kinematic and can be measured using the induced dilatancy angle, which is transformed into a state-dependent form. The state-dependent induced dilatancy angle decreases with decreasing material density, which enables the simulation of the softening phenomena and weakens dilatancy. After attaining the critical state, the incremental behavior reverts to an isotropic state. The compression and unloading curves considering grain crushing are introduced, and the corresponding free energy functions are derived under varying densities. In the proposed model, the different mechanical properties of loose sand and dense sand are derived from the state dependency of the kinematic constraint. Toyoura sand simulations reveal that the proposed model is able to accurately describe the stress-dilatancy relation of varying initial densities and confining pressures under both drained and undrained conditions. Triaxial compression tests on Leighton Buzzard sand and Rumei rockfills with different densities and confining pressures also demonstrate the validity of the model.

Abstract:For a quasi-statically sheared granular system, the deformation of individual particles leads to reversible energy storage that sustains elastic stress. But, the system would subsequently relax because particles jiggle and slide. By employing the complete continuum mechanical theory, also known as Granular Solid Hydrodynamics (GSH), the elastic energy and its relaxation (denoted by granular temperature) are both calculated and explained. For a dense assembly, it is found that the elastic energy and energy dissipation rate reach peak values simultaneously, as it reaches peak strength. To observe the mesoscale characteristics, a two-dimension biaxial test is simulated with a discrete element method. The motion of particles and the evolution of force networks are exhibited at different strain values. The discrete element simulations results are helpful to understand GSH results.

Abstract:A continuum model for granular materials, which transitions from an elastic jammed phase to rapid flows, is developed using a large deformation Eulerian formulation for compressible elastic-viscoplastic response. The model incorporates constitutive functions capturing μ(I) rheology, the value of the solid fraction developed for steady-state shearing, and the transient response for shear reversal based on experiments and simulations of interacting particles using the Discrete Element Method (DEM). The present model exhibits hyperelastic response with the stress determined by measures of elastic dilatation and elastic distortional deformations. This causes the stress to naturally have a direction different from the rate of deformation tensor for transient response. Examples examine pure dilation, steady-state simple shear, transient shearing with shear reversal for constant volume and constant non-shearing components of stress, and the transient transition to jamming.

Abstract:Abstract This paper presents an elastic-gap free isotropic higher-order strain gradient plasticity theory that effectively captures dissipation associated to plastic strain gradients. Unlike conventional methods that divide the higher-order stress, this theory focuses on dividing the plastic strain gradient into energetic and dissipative components. The moment stress that arises from minimizing a dissipating potential demonstrates a nonlinear evolution over time, resembling the Armstrong-Frederick nonlinear kinematic hardening rule in classical plasticity. The thermodynamically consistent framework establishes additional dissipation in the dissipation inequality. The energetic moment stress saturates as the effective plastic strain increases during plastic flow. In contrast to the Gurtin-type non-incremental model, the proposed model smoothly captures the apparent strengthening at saturation without causing a stress jump. A passivated shear layer is analytically assessed to demonstrate that the proposed theory exhibits the same amount of dissipation as the existing Gurtin-type model when they show similar shear responses at saturation. It is also shown that the plastic flow remains continuous under non-proportional loading conditions using an intermediately passivated shear layer problem. Finally, the proposed theory is validated against a recent experiment involving combined bending torsion of an L-shaped beam using a 3D finite element solution. Overall, the proposed model provides an alternative approach to evaluating the size effect within the non-incremental isotropic strain gradient plasticity theory without introducing any stress jump.
